2026 MAdaKron: A mixture-of-AdaKron adapters
abstract
Adapting pre-trained Large Language Models to specific tasks has traditionally involved updating all of their parameters. Nonetheless, this technique becomes impractical for models containing billions of parameters. This has led to intensive research on Parameter-Efficient Fine-Tuning (PEFT) techniques, which aim to train a small fraction of the model’s parameters while maintaining comparable performance to Full Fine-Tuning. A popular method is the Adapter, i.e. small trainable layers added to pre-trained models. Recently, we present AdaKron, an Adapter-based PEFT technique, which leverages the Kronecker product to combine the outputs of two small networks, training less than 0.55 % of the model’s parameters while outperforming Full Fine-Tuning. In this paper, we put forward a novel technique, called MAdaKron, a Mixture-of-AdaKron model, which combines AdaKron with a Mixture of Experts approach. MAdaKron combines the flexibility of a Mixture of Experts architecture with the efficiency given by AdaKron to further enhance its performance. We then extensively evaluate MAdaKron on eighteen Natural Language Understanding and Generation benchmarks, showing that it achieves performance on par or even better than recent state-of-the-art PEFT methods, while reducing the number of trainable parameters. These findings highlight MAdaKron as an efficient solution for Fine-Tuning LLMs, offering substantial computational cost reductions without losing performance.

2025 Investigating Task Arithmetic for Zero-Shot Information Retrieval
abstract
Large Language Models (LLMs) have shown impressive zero-shot performance across a variety of Natural Language Processing tasks, including document re-ranking. However, their effectiveness degrades on unseen tasks and domains, largely due to shifts in vocabulary and word distributions. In this paper, we investigate Task Arithmetic, a technique that combines the weights of LLMs pre-trained on different tasks or domains via simple mathematical operations, such as addition or subtraction, to adapt retrieval models without requiring additional fine-tuning. Our method is able to synthesize diverse tasks and domain knowledge into a single model, enabling effective zero-shot adaptation in different retrieval contexts. Extensive experiments on publicly available scientific, biomedical, and multilingual datasets show that our method improves state-of-the-art re-ranking performance by up to 18% in NDCG@10 and 15% in P@10. In addition to these empirical gains, our analysis provides insights into the strengths and limitations of Task Arithmetic as a practical strategy for zero-shot learning and model adaptation. 2024 AdaKron: An Adapter-based Parameter Efficient Model Tuning with Kronecker Product
abstract
The fine-tuning paradigm has been widely adopted to train neural models tailored for specific tasks. However, the recent upsurge of Large Language Models (LLMs), characterized by billions of parameters, has introduced profound computational challenges to the fine-tuning process. This has fueled intensive research on Parameter-Efficient Fine-Tuning (PEFT) techniques, usually involving the training of a selective subset of the original model parameters. One of the most used approaches is Adapters, which add trainable lightweight layers to the existing pretrained weights. Within this context, we propose AdaKron, an Adapter-based fine-tuning with the Kronecker product. In particular, we leverage the Kronecker product to combine the output of two small networks, resulting in a final vector whose dimension is the product of the dimensions of the individual outputs, allowing us to train only 0.55% of the model’s original parameters. We evaluate AdaKron performing a series of experiments on the General Language Understanding Evaluation (GLUE) benchmark, achieving results in the same ballpark as recent state-of-the-art PEFT methods, despite training fewer parameters.

2024 Personalized Large Language Models through Parameter Efficient Fine-Tuning Techniques
abstract
Personalization of the search experience according to the users and their context is an important topic in Information Retrieval (IR), studied by the research community for a long time. The IR field has witnessed a transformation with the recent availability of pre-trained Large Language Models. Typically, personalization requires the model to incorporate user-specific information, through the definition of an appropriate prompting or injecting user knowledge into the model and then fine-tuning it. However, using prompting, we do not know where and how much the model is personalizing the output. Furthermore, fine-tuning such systems is computationally expensive: since they are characterized by billions of parameters, the fine-tuning process has introduced profound computational challenges. For these reasons, we propose a novel approach that combines personalization and Parameter Efficient Fine-Tuning methods.
