2025 Exploiting Hidden Symmetry to Improve Objective Perturbation for DP Linear Learners with a Nonsmooth L1-Norm
abstract
Objective Perturbation (OP) is a classic approach to differentially private (DP) convex optimization with smooth loss functions but is less understood for nonsmooth cases. In this work, we study how to apply OP to DP linear learners under loss functions with an implicit $\ell_1$-norm structure, such as $\max(0,x)$ as a motivating example. We propose to first smooth out the implicit $\ell_1$-norm by convolution, and then invoke standard OP. Convolution has many advantages that distinguish itself from Moreau Envelope, such as approximating from above and a higher degree of hyperparameters. These advantages, in conjunction with the symmetry of $\ell_1$-norm, result in tighter pointwise approximation, which further facilitates tighter analysis of generalization risks by using pointwise bounds. Under mild assumptions on groundtruth distributions, the proposed OP-based algorithm is found to be rate-optimal, and can achieve the excess generalization risk $\mathcal{O}(\frac{1}{\sqrt{n}}+\frac{\sqrt{d\ln(1/\delta)}}{n\varepsilon})$. Experiments demonstrate the competitive performance of the proposed method to Noisy-SGD.

2024 Noisy Dual Mirror Descent: A Near Optimal Algorithm for Jointly-DP Convex Resource Allocation
abstract
We study convex resource allocation problems with $m$ hard constraints under $(\varepsilon,\delta)$-joint differential privacy (Joint-DP or JDP) in an offline setting. To approximately solve the problem, we propose a generic algorithm called Noisy Dual Mirror Descent. The algorithm applies noisy Mirror Descent to a dual problem from relaxing the hard constraints for private shadow prices, and then uses the shadow prices to coordinate allocations in the primal problem. Leveraging weak duality theory, we show that the optimality gap is upper bounded by $\mathcal{O}(\frac{\sqrt{m\ln(1/\delta)}}{\varepsilon})$, and constraint violation is no more than $\mathcal{O}(\frac{\sqrt{m\ln(1/\delta)}}{\varepsilon})$ per constraint. When strong duality holds, both preceding results can be improved to $\widetilde{\mathcal{O}}(\frac{\sqrt{\ln(1/\delta)}}{\varepsilon})$ by better utilizing the geometric structure of the dual space, which is neglected by existing works. To complement our results under strong duality, we derive a minimax lower bound $\Omega(\frac{m}{\varepsilon})$ for any JDP algorithm outputting feasible allocations. The lower bound matches our upper bounds up to some logarithmic factors for $\varepsilon\geq \max(1, 1/(n\gamma))$, where $n\gamma$ is the available resource level. Numerical studies further confirm the effectiveness of our algorithm.

2023 Differentially Private Stochastic Convex Optimization under a Quantile Loss Function
abstract
We study $(\varepsilon,\delta)$-differentially private (DP) stochastic convex optimization under an $r$-th quantile loss function taking the form $c(u) = ru^+ + (1-r)(-u)^+$. The function is non-smooth, and we propose to approximate it with a smooth function obtained by convolution smoothing, which enjoys both structure and bandwidth flexibility and can address outliers. This leads to a better approximation than those obtained from existing methods such as Moreau Envelope. We then design private algorithms based on DP stochastic gradient descent and objective perturbation, and show that both algorithms achieve (near) optimal excess generalization risk $O(\max\{\frac{1}{\sqrt{n}}, \frac{\sqrt{d\ln(1/\delta)}}{n\varepsilon}\})$. Through objective perturbation, we further derive an upper bound $O(\max\{\sqrt{\frac{d}{n}}, \sqrt{\frac{d\ln(1/\delta)}{n\varepsilon}}\})$ on the parameter estimation error under mild assumptions on data generating processes. Some applications in private quantile regression and private inventory control will be discussed.
