| 2022 | Semisupervised Learning via Axiomatic Fuzzy Set Theory and SVMabstractIn this article, we present a semantic semisupervised learning (Semantic SSL) approach targeted at unifying two machine-learning paradigms in a mutually beneficial way, where the classical support vector machine (SVM) learns to reveal primitive logic facts from data, while axiomatic fuzzy set (AFS) theory is utilized to exploit semantic knowledge and correct the wrongly perceived facts for improving the machine-learning model. This novel semisupervised method can easily produce interpretable semantic descriptions to outline different categories by forming a fuzzy set with semantic explanations realized on the basis of the AFS theory. Besides, it is known that disagreement-based semisupervised learning (SSL) can be viewed as an excellent schema so that a co-training approach with SVM and the AFS theory can be utilized to improve the resulting learning performance. Furthermore, an evaluation index is used to prune descriptions to deliver promising performance. Compared with other semisupervised approaches, the proposed approach can build a structure to reflect data-distributed information with unlabeled data and labeled data, so that the hidden information embedded in both labeled and unlabeled data can be sufficiently utilized and can potentially be applied to achieve good descriptions of each category. Experimental results demonstrate that this approach can offer a concise, comprehensible, and precise SSL frame, which strikes a balance between the interpretability and the accuracy. | 2022 | Deep Fuzzy Rule-Based Classification System With Improved Wang-Mendel MethodabstractWang–Mendel (WM) fuzzy system is an effective and interpretable model for solving tabular data classification problem. However, original WM fuzzy system is weak in handling dataset with high dimensionality or large volume. Meanwhile, its capability of characterizing data is narrow, which results from lacking hierarchical transformation of features like deep learning-based models. In this article, we propose a deep fuzzy rule-based classification system (DFRBCS) based on improved WM method, in which fuzzy technique and deep learning strategy are combined to make a desirable tradeoff between model’s interpretability and prediction accuracy. We first redefine the consequent part of fuzzy rule in WM fuzzy system with class probability vector, which endows the improved WM fuzzy system with capacity for serving as building block of deep model. The model structure of DFRBCS is designed in layer-by-layer manner, where raw features can be transformed hierarchically. For every layer in DFRBCS, it contains many improved WM fuzzy systems whose input spaces are generated by shuffling and sliding window operation on concatenated outputs of fuzzy systems in previous layer. Comparative experiments are conducted on 45 real-world datasets with various sizes and dimensionality between our method, five baseline models, and the other deep fuzzy classifiers (D-TSK-FC, HID-TSK-FC, FCCI-TSK, DSA-FC, and MEEFIS). The experimental results show that DFRBCS is competitive in classification performance and promising in model’s interpretability. Yuangang Wang, Shuo Guan, Xiaodong Liu 0001, Xiaodong Duan |

| 2018 | AIM: Fast and energy-efficient AES in-memory implementation for emerging non-volatile main memoryabstractNon-volatile main memory-based systems pose an opportunity for an attacker to readily access sensitive information on the memory because of its long retention time. While real-time memory encryption with dedicated AES engine can address this vulnerability, it incurs extra performance and energy overheads. As an alternative, we propose an AES in-memory implementation, AIM, to encrypt the whole/part of the memory only when it is necessary. We leverage the benefits offered by the inmemory computing architecture to address the challenges of the bandwidth intensive encryption application. We take advantage of NVM's intrinsic logic operation capability to implement the AES task. Embracing the massive parallelism inside the memory, AIM outperforms existing mechanisms with higher throughput yet lower energy consumption. Compared with state-of-the-art AES engine running at 2.1GHz, AIM can speed up the encryption process by 80 χ for a 1GB NVM. | 2018 | A Novel Semantic Approach for Multi-Ethnic Face RecognitionabstractThis paper proposes a semantic concept method to recognize multi-ethnic people based on Axiomatic fuzzy set (AFS) theory with application to image analysis. There are two advantages of the proposed approach: (i) It can convert the facial features to semantic concepts and in such a way we bridge the semantic gap between low level pixel features and interpretable concepts. (ii) It can implement the logical operation of semantic concepts in the AFS framework. Technically, we first construct facial features utilizing the facial landmarks such as eyes, nose, mouth, and face contour. Second, we establish some corresponding semantic concepts to describe facial features. Finally, a set of the semantic concept rules are extracted to form a classifier aimed at identifying facial ethnic attributes. The efficacy of the proposed approach is verified on Chinese Multi-ethnic face database (CMFD), FEI and CK[Formula: see text]. Meanwhile, we first demonstrate that the selected features have two obvious advantages: (1) these features can achieve better performance for ethical recognition than the features based on pixel values directly. (2) The selected features can be obtained via facial landmark detector regardless of the image resolutions. Then, we compare the proposed approach with some existing classifiers using the selected features, such as principal component analysis (PCA), C4.5, Decision table, Cart, Fuzzy Decision Tree (FDT) and Repeated Incremental Pruning to Produce Error Reduction (Ripper), extensive experiments show that our method exhibits a similar performance with these methods, which is demonstrated by Friedman test, however, our proposed approach can provide interpretability and comprehension capability. | 2018 | AFSNN: A Classification Algorithm Using Axiomatic Fuzzy Sets and Neural NetworksabstractIn this study, we present a comprehensible classifier AFSNN that embeds a new type of coherence membership function, which builds upon the theoretical findings of the axiomatic fuzzy set (AFS) theory into the hidden layer of neural network with random weights (NNRWs). Borrowing from the idea of NNRWs that employs the random initialization technique, the relation among attributes, simple concepts, and complex concepts are randomly determined. Complex concepts are generated through the combination of randomly selected simple concepts by AFS logic operation. The output weights of NNRWs are utilized to evaluate the confidence of each complex concept for every target class, which means that the feasibility of complex concepts for every class is determined analytically rather than through the tuning parameters of constraint conditions such as in conventional AFS-based classifiers. For the proposed method, compared to other neural-network-based classification methods, the fuzzy descriptions generated from complex concepts in hidden layer make classification result human understandable. We have experimented with several benchmark datasets and compared the results with other neural network-based classifiers. We show that our method outperforms Ensemble, EvRBFN, NNEP, LVQ, and iRProp+ in the seven out of ten datasets. The results show that the performance of AFSNN is competitive in terms of classification accuracy and the network shows a distinctive capability of providing explicit knowledge in the form of linguistic description. | 2017 | An energy-efficient and high-throughput bitwise CNN on sneak-path-free digital ReRAM crossbarabstractConvolutional neural network (CNN) based machine learning requires a highly parallel as well as low power consumption (including leakage power) hardware accelerator. In this paper, we will present a digital ReRAM crossbar based CNN accelerator that can achieve significantly higher throughput and lower power consumption than state-of-arts. The CNN is trained with binary constraints on both weights and activations such that all operations become bitwise. With further use of 1-bit comparator, the bitwise CNN model can be naturally realized on a digital ReRAM-crossbar device. A novel sneak-path-free ReRAM-crossbar is further utilized for large-scale realization. Simulation experiments show that the bitwise CNN accelerator on the digital ReRAM crossbar achieves 98.3% and 91.4% accuracy on MNIST and CIFAR-10 benchmarks, respectively. Moreover, it has a peak throughput of 792GOPS at the power consumption of 6.3mW, which is 18.86 times higher throughput and 44.1 times lower power than CMOS CNN (non-binary) accelerators. | 2017 | A lightweight progress maximization scheduler for non-volatile processor under unstable energy harvestingabstractEnergy harvesting techniques become increasingly popular as power supplies for embedded systems. However, the harvested energy is intrinsically unstable. Thus, the program execution may be interrupted frequently. Although the development of non-volatile processors (NVP) can save and restore execution states, both hardware and software challenges exist for energy harvesting powered embedded systems. On the hardware side, existing power detector only signals the ``poor'' quality of the harvested power based on a preset threshold voltage. The inappropriate setting of this threshold will make the NVP based embedded system suffer from either unnecessary checkpointing or checkpointing failures. On the software side, not all tasks can be checkpointed. Once the power is off, these tasks will have to restart from the beginning. In this paper, a task scheduler is proposed to maximize task progress by prioritizing tasks which cannot be checkpointed when power is weak so that they can finish before the power outage. To assist task scheduling, three additional modules including voltage monitor, checkpointing handler, and routine handler, are proposed. Experimental results show increased overall task progress and reduced energy consumption. Mimi Xie, Yongpan Liu, Yanzhi Wang 0001, Chun Jason Xue, Yuangang Wang, Yiran Chen 0001, Jingtong Hu |

| 2017 | Lightweight Data Compression for Mobile Flash StorageabstractData compression is beneficial to flash storage lifespan. However, because the design of mobile flash storage is highly cost-sensitive, hardware compression becomes a less attractive option. This study investigates the feasibility of data compression on mobile flash storage. It first characterizes data compressibility based on mobile apps, and the analysis shows that write traffic bound for mobile storage volumes is highly compressible. Based on this finding, a lightweight approach is introduced for firmware-based data compression in mobile flash storage. The controller and flash module work in a pipelined fashion to hide the data compression overhead. Together with this pipelined design, the proposed approach selectively compresses incoming data of high compressibility, while leaving data of low compressibility to a compression-aware garbage collector. Experimental results show that our approach greatly reduced the frequency of block erase by 50.5% compared to uncompressed flash storage. Compared to unconditional data compression, our approach improved the write latency by 10.4% at a marginal cost of 4% more block erase operations. | 2016 | Scalable memory fabric for silicon interposer-based multi-core systemsabstractThree-dimensional (3D) integration is considered as a solution to overcome capacity, bandwidth, and performance limitations of memories. However, due to thermal challenges and cost issues, industry embraced 2.5D implementation for integrating die-stacked memories with large-scale designs, which is enabled by silicon interposer technology that integrates processors and multiple modules of 3D-stacked memories in the same package. Previous work has adopted Network-on-Chip (NoC) concepts for the communication fabric of 3D designs, but the design of a scalable processor-memory interconnect for 2.5D integration remains elusive. Therefore, in this work, we first explore different network topologies for integrating CPUs and memories in a silicon interposer-based multi-core system and reveal that simple point-to-point connections cannot reach the full potential of the memory performance due to bandwidth limitations, especially as more and more memory modules are needed to enable emerging applications with high memory capacity and bandwidth demand, such as in-memory computing. To overcome this scaling problem, we propose a memory network design to directly connect all the memory modules, utilizing the existing routing resource of silicon interposers in 2.5D designs. Observing the unique network traffic in our design, we present a design space exploration that evaluates network topologies and routing algorithms, taking process node and interposer technology design decisions into account. We implement an event-driven simulator to evaluate our proposed memory network in silicon interposer (MemNiSI) design with synthetic traffic as well as real in-memory computing workloads. Our experimental results show that compared to baseline designs, MemNiSI topology reduces the average packet latency by up to 15.3% and Choose Fastest Path (CFP) algorithm further reduces by up to 8.0%. Our scheme can utilize the potential of integrated stacked memory effectively while providing better scalability and infrastructure for large-scale silicon interposer-based 2.5D designs. | 2016 | A unified memory network architecture for in-memory computing in commodity serversabstractIn-memory computing is emerging as a promising paradigm in commodity servers to accelerate data-intensive processing by striving to keep the entire dataset in DRAM. To address the tremendous pressure on the main memory system, discrete memory modules can be networked together to form a memory pool, enabled by recent trends towards richer memory interfaces (e.g. Hybrid Memory Cubes, or HMCs). Such an inter-memory network provides a scalable fabric to expand memory capacity, but still suffers from long multi-hop latency, limited bandwidth, and high power consumption — problems that will continue to exacerbate as the gap between interconnect and transistor performance grows. Moreover, inside each memory module, an intra-memory network (NoC) is typically employed to connect different memory partitions. Without careful design, the back-pressure inside the memory modules can further propagate to the inter-memory network to cause a performance bottleneck. To address these problems, we propose co-optimization of intra- and inter-memory network. First, we re-organize the intra-memory network structure, and provide a smart I/O interface to reuse the intra-memory NoC as the network switches for inter-memory communication, thus forming a unified memory network. Based on this architecture, we further optimize the inter-memory network for both high performance and lower energy, including a distance-aware selective compression scheme to drastically reduce communication burden, and a light-weight power-gating algorithm to turn off under-utilized links while guaranteeing a connected graph and deadlock-free routing. We develop an event-driven simulator to model our proposed architectures. Experiment results based on both synthetic traffic and real big-data workloads show that our unified memory network architecture can achieve 75.1% average memory access latency reduction and 22.1% total memory energy saving. | 2016 | S-RAC: SSD Friendly Caching for Data Center WorkloadsabstractCurrent data-center applications tend to process increasingly large volume of data sets. The caching effect of page cache is reduced by its limited capacity. Emerging flash-based solid state drives (SSD) have latency and price advantages compared to hard disk and DRAM. Thus, SSD-based caching is widely deployed in data centers. However, SSD caching faces two challenges. First, SSD has limited write endurance, which requires cache manager to reduce write amount to SSD. Second, data-center workloads exhibit a diverse I/O access patterns, which requires one to figure out SSD caching friendly access patterns. This paper first classifies 6 I/O access patterns among 32 data-center workloads using a cost-benefit analysis. We derive implications for designing SSD cache from analyzing the access patterns. We then propose an SSD cache manager S-RAC with re-adding blocks and ghost cache adaptation to retain SSD friendly blocks in SSD. The experimental evaluation shows the efficiency of S-RAC in reducing SSD write amount while improving/maintaining cache hit ratio. | 2016 | Efficient Data Placement for Improving Data Access Performance on Domain-Wall MemoryabstractA domain-wall memory (DWM) is becoming an attractive candidate to replace the traditional memories for its high density, low-power leakage, and low access latency. Accessing data on DWM is accomplished by shift operations that move data located on nanowires to read/write ports. Due to this kind of construction, data accesses on DWM exhibit varying access latencies. Therefore, data placement (DP) strategy has a significant impact on the performance of data accesses on DWM. In this paper, we prove the nondeterministic polynomial time (NP)-completeness of the DP problem on DWM. For the DWMs organized in single DWM block cluster (DBC), we present integer linear programming formulations to solve the problem optimally. We also propose an efficient single DBC placement (S-DBC-P) algorithm to exploit the benefits of multiple read/write ports and data locality. Compared with the sequential DP strategy, S-DBC-P reduces 76.9% shift operations on average for eight-port DWMs. Furthermore, for DP problem on the DWMs organized in multiple DBCs, we develop an efficient multiple DBC placement (M-DBC-P) algorithm to utilize the parallelism of DBCs. The experimental results show that the M-DBC-P achieves 90% performance improvement over the sequential DP strategy. Xianzhang Chen, Edwin H.-M. | 2016 | Efficient Synchronization for Distributed Embedded MultiprocessorsabstractIn multiprocessor systems, low-latency synchronization is extremely important to effectively exploit fine-grain data parallelism and improve overall performance. This brief presents an efficient synchronization for embedded distributed multiprocessors. The proposed solution works in a completely decentralized request-response manner via explicit message exchange among the processing elements. Scalable lock and barrier synchronization algorithms, which are derived from the inherent distributed characteristics of the underlying architecture, are proposed to enable fair, orderly, and contention-free synchronization. We implement the proposed synchronization model in a distributed 32-core architecture with a commercial cycle-accurate SystemC simulation platform. Experimental results that show our proposed approach achieves ultralow synchronization latency and almost ideal scalability when the core count scales. | 2015 | An energy efficient and low cross-talk CMOS sub-THz I/O with surface-wave modulator and interconnectabstractFree-space EM-wave based GHz interconnect has significant loss and crosstalk that cannot be deployed as low-power and dense I/Os for future network-on-chip (NoC) integration of many-core and memory. This paper proposes an energy-efficient and low-crosstalk sub-THz (0.1T-1T) I/O with use of surface-wave based modulator and interconnects in CMOS. By introducing sub-wavelength periodical corrugation structure onto transmission line, the surface-wave is established to propagate signal that is strongly localized on surface of top-layer metal wire, which results in low coupling into lossy substrate and neighboring metal wires. As such, significant power saving and cross-talk reduction can be observed with high communication bandwidth. In addition, a high on/off-ratio surface-wave modulator is also proposed to support on-chip THz communication. As designed in 65nm CMOS, the results have shown that the proposed surface-wave I/O interface achieves 25Gbps data rate and 0.016pJ/bit/mm energy efficiency at 140GHz carrier frequency over 20mm surface-wave channels. They can be placed with 2.4μm channel spacing and a -20dB crosstalk ratio. The surface-wave modulator also achieves significant reduction of radiation loss with 23dB extinction ratio.
