2023 Switchboard: Efficient Resource Management for Conferencing Services
abstract
Resource management is important for conferencing services (such as Microsoft Teams, Zoom) to ensure good user experience while keeping the costs low. Key to this is the efficient provisioning and assignment of media processing (MP) servers, which do the heavy lifting of mixing and redistributing the media streams from and to the call participants.

2021 Monitoring Cloud Service Unreachability at Scale
abstract
We consider the problem of network unreachability in a global-scale cloud-hosted service that caters to hundreds of millions of users. Even when the service itself is up, the "last mile" between where users are, and the cloud is often the weak link that could render the service unreachable. We present NetDetector, a tool for detecting network-unreachability based on measurements from a client-based HTTP-ping service. NetDetector employs two models. The first, GA (Gaussian Alerts) models temporally averaged raw success rate of the HTTP-pings as a Gaussian distribution and flags significant dips below the mean as unreachability episodes. The second, more sophisticated approach (BB, or Beta-Binomial) models the health of network connectivity as the probability of an access request succeeding, estimates health from noisy samples, and alerts based on dips in health below a client-network-specific SLO (service-level objective) derived from data. These algorithms are enhanced by a drill-down technique that identifies a more precise scope of the unreachability event. We present promising results from GA, which has been in deployment, and the experimental BB detector over a 4-month period. For instance, GA flags 49 country-level unreachability incidents, of which 42 were labelled true positives based on investigation by on-call engineers (OCEs).

2019 Clustered Monotone Transforms for Rating Factorization
abstract
Exploiting low-rank structure of the user-item rating matrix has been the crux of many recommendation engines. However, existing recommendation engines force raters with heterogeneous behavior profiles to map their intrinsic rating scales to a common rating scale (e.g. 1-5). This non-linear transformation of the rating scale shatters the low-rank structure of the rating matrix, therefore resulting in a poor fit and consequentially, poor recommendations. In this paper, we propose Clustered Monotone Transforms for Rating Factorization (CMTRF), a novel approach to perform regression up to unknown monotonic transforms over unknown population segments. Essentially, for recommendation systems, the technique searches for monotonic transformations of the rating scales resulting in a better fit. This is combined with an underlying matrix factorization regression model that couples the user-wise ratings to exploit shared low dimensional structure. The rating scale transformations can be generated for each user, for a cluster of users, or for all the users at once, forming the basis of three simple and efficient algorithms proposed in this paper, all of which alternate between transformation of the rating scales and matrix factorization regression. Despite the non-convexity, CMTRF is theoretically shown to recover a unique solution under mild conditions. Experimental results on two synthetic and seven real-world datasets show that CMTRF outperforms other state-of-the-art baselines.

2015 Parameter Estimation of Generalized Linear Models without Assuming their Link Function
abstract
Canonical generalized linear models (GLM) are completely specified by a finite dimensional vector and a monotonically increasing function called the link function. Standard parameter estimation techniques hold the link function fixed and optimizes over the parameter vector. We propose a parameter-recovery facilitating, jointly-convex, regularized loss functional that is optimized globally over the vector as well as the link function, with best rates possible under a first order oracle model. This widens the scope of GLMs to cases where the link function is unknown.

2014 An Optimization Framework for Combining Ensembles of Classifiers and Clusterers with Applications to Nontransductive Semisupervised Learning and Transfer Learning
abstract
Unsupervised models can provide supplementary soft constraints to help classify new “target” data because similar instances in the target set are more likely to share the same class label. Such models can also help detect possible differences between training and target distributions, which is useful in applications where concept drift may take place, as in transfer learning settings. This article describes a general optimization framework that takes as input class membership estimates from existing classifiers learned on previously encountered “source” (or training) data, as well as a similarity matrix from a cluster ensemble operating solely on the target (or test) data to be classified, and yields a consensus labeling of the target data. More precisely, the application settings considered are nontransductive semisupervised and transfer learning scenarios where the training data are used only to build an ensemble of classifiers and are subsequently discarded before classifying the target data. The framework admits a wide range of loss functions and classification/clustering methods. It exploits properties of Bregman divergences in conjunction with Legendre duality to yield a principled and scalable approach. A variety of experiments show that the proposed framework can yield results substantially superior to those provided by naïvely applying classifiers learned on the original task to the target data. In addition, we show that the proposed approach, even not being conceptually transductive, can provide better results compared to some popular transductive learning techniques.

2013 Retargeted matrix factorization for collaborative filtering
abstract
This paper introduces retargeted matrix factorization (R-MF); a novel approach for learning the user-wise ranking of items in the context of collaborative filtering. R-MF learns to rank by "retargeting" the item ratings of each user, searching for a monotonic transformation of the ratings that results in a better fit while preserving the ranked order of each user's ratings. The retargeting is combined with an underlying matrix factorization regression model that couples the user-wise rankings to exploit shared low dimensional structure. We show that R-MF recovers a unique solution under mild conditions, and propose a simple and efficient optimization scheme that alternates between retargeting the ratings subject to ordering constraints, and matrix factorization regression. The retargeting step is independent for each user, and is trivially parallelized. The ranking performance of retargeted matrix factorization is evaluated on benchmark movie recommendation datasets and results in superior ranking performance compared to collaborative filtering algorithms specifically designed to optimize ranking metrics.

2013 Bregman Divergences and Triangle Inequality
abstract
While Bregman divergences have been used for clustering and embedding problems in recent years, the facts that they are asymmetric and do not satisfy triangle inequality have been a major concern. In this paper, we investigate the relationship between two families of symmetrized Bregman divergences and metrics that satisfy the triangle inequality. The first family can be derived from any well-behaved convex function. The second family generalizes the Jensen-Shannon divergence, and can only be derived from convex functions with certain conditional positive definiteness structure. We interpret the required structure in terms of cumulants of infinitely divisible distributions, and related results in harmonic analysis. We investigate kmeans-type clustering problems using both families of symmetrized divergences, and give efficient algorithms for the same.

2008 A spam resistant family of concavo-convex ranks for link analysis
abstract
A parameterized family of non-linear, link analytic ranking functions is proposed that includes Pagerank as a special case and uses the convexity property of those functions to be more resistant to link spam attacks. A contribution of the paper is the construction of such a scheme with provable uniqueness and convergence guarantees. The paper also demonstrates that even in an unlabelled scenario this family can have spam resistance comparable to Trustrank [3] that uses labels of spam or nat-spam on a training set. The proposed method can use labels, if available, to improve its performance to provide state of the art level of link spam protection.

2006 Transductive De-Noising and Dimensionality Reduction using Total Bregman Regression
abstract
Our goal on one hand is to use labels or other forms of ground truth data to guide the tasks of de-noising and dimensionality reduction and balance the objectives of better prediction and better data summarization, on the other hand it is to explicitly model the noise in the feature values. We use a generalization of L2 loss, on which PCA and K-Means are based, to the Bregman family which, as a consequence widens the applicability of the proposed algorithms to cases where the data may be constrained to lie on sets of integers or sets of labels rather than ℝd as in PCA or K-means formulations. This makes it possible to handle different prediction tasks such as classification and regression in an unified way. Two tasks are formulated (i) Transductive Total Bregman Regression (ii) Transductive Bregman PCA.
