2023 Facebook Content Search: Efficient and Effective Adapting Search on A Large Scale
abstract
Facebook content search is a critical channel that enables people to discover the best content to deepen their engagement with friends and family, creators, and communities. Building a highly personalized search engine to serve billions of daily active users to find the best results from a large scale of candidates is a challenging task. The search engine must take multiple dimensions into consideration, including different content types, different query intents, and user social graph, etc. In this paper, we discuss the challenges of Facebook content search in depth, and then describe our novel approach to efficiently handling a massive number of documents with advanced query understanding, retrieval, and machine learning techniques. The proposed system has been fully verified and applied to the production system of Facebook Search, which serves billions of users.

2023 Integrity and Junkiness Failure Handling for Embedding-based Retrieval: A Case Study in Social Network Search
abstract
Embedding based retrieval has seen its usage in a variety of search applications like e-commerce, social networking search etc. While the approach has demonstrated its efficacy in tasks like semantic matching and contextual search, it is plagued by the problem of uncontrollable relevance. In this paper, we conduct an analysis of embedding-based retrieval launched in early 2021 on our social network search engine, and define two main categories of failures introduced by it, integrity and junkiness. The former refers to issues such as hate speech and offensive content that can severely harm user experience, while the latter includes irrelevant results like fuzzy text matching or language mismatches. Efficient methods during model inference are further proposed to resolve the issue, including indexing treatments and targeted user cohort treatments, etc. Though being simple, we show the methods have good offline NDCG and online A/B tests metrics gain in practice. We analyze the reasons for the improvements, pointing out that our methods are only preliminary attempts to this important but challenging problem. We put forward potential future directions to explore.

2013 Towards Machine Learning-Based Auto-tuning of MapReduce
abstract
MapReduce, which is the de facto programming model for large-scale distributed data processing, and its most popular implementation Hadoop have enjoyed widespread adoption in industry during the past few years. Unfortunately, from a performance point of view getting the most out of Hadoop is still a big challenge due to the large number of configuration parameters. Currently these parameters are tuned manually by trial and error, which is ineffective due to the large parameter space and the complex interactions among the parameters. Even worse, the parameters have to be re-tuned for different MapReduce applications and clusters. To make the parameter tuning process more effective, in this paper we explore machine learning-based performance models that we use to auto-tune the configuration parameters. To this end, we first evaluate several machine learning models with diverse MapReduce applications and cluster configurations, and we show that support vector regression model (SVR) has good accuracy and is also computationally efficient. We further assess our auto-tuning approach, which uses the SVR performance model, against the Starfish auto tuner, which uses a cost-based performance model. Our findings reveal that our auto-tuning approach can provide comparable or in some cases better performance improvements than Starfish with a smaller number of parameters. Finally, we propose and discuss a complete and practical end-to-end auto-tuning flow that combines our machine learning-based performance models with smart search algorithms for the effective training of the models and the effective exploration of the parameter space.

2011 Optimizing Network I/O Virtualization with Efficient Interrupt Coalescing and Virtual Receive Side Scaling
abstract
Virtualization is a fundamental component in cloud computing because it provides numerous guest VM transparent services, such as live migration, high availability, rapid checkpoint, etc. However, I/O virtualization, particularly for network, is still suffering from significant performance degradation. In this paper, we analyze performance challenges in network I/O virtualization and observe that the conventional network I/O virtualization incurs excessive virtual interrupts to guest VMs, and the backend driver in the driver domain is not parallelized and cannot leverage underlying multi-core processors. Motivated by the above observations, we propose optimizations: efficient interrupt coalescing for network I/O virtualization and virtual receive side scaling to effectively leverage multi-core processors. We implemented those optimizations in Xen and did extensive performance evaluation. Our experimental results reveal that the proposed optimizations significantly improve network I/O virtualization performance and effectively tackle the performance challenges.

2011 A new server I/O architecture for high speed networks
abstract
Traditional architectural designs are normally focused on CPUs and have been often decoupled from I/O considerations. They are inefficient for high-speed network processing with a bandwidth of 10Gbps and beyond. Long latency I/O interconnects on mainstream servers also substantially complicate the NIC designs. In this paper, we start with fine-grained driver and OS instrumentation to fully understand the network processing overhead over 10GbE on mainstream servers. We obtain several new findings: 1) besides data copy identified by previous works, the driver and buffer release are two unexpected major overheads (up to 54%); 2) the major source of the overheads is memory stalls and data relating to socket buffer (SKB) and page data structures are mainly responsible for the stalls; 3) prevailing platform optimizations like Direct Cache Access (DCA) are insufficient for addressing the network processing bottlenecks. Motivated by the studies, we propose a new server I/O architecture where DMA descriptor management is shifted from NICs to an on-chip network engine (NEngine), and descriptors are extended with information about data incurring memory stalls. NEngine relies on data lookups and preloads data to eliminate the stalls during network processing. Moreover, NEngine implements efficient packet movement inside caches to address the remaining issues in data copy. The new architecture allows DMA engine to have very fast access to descriptors and keeps packets in CPU caches instead of NIC buffers, significantly simplifying NICs. Experimental results demonstrate that the new server I/O architecture improves the network processing efficiency by 47% and web server throughput by 14%, while substantially reducing the NIC hardware complexity.

2011 Full-chip runtime error-tolerant thermal estimation and prediction for practical thermal management
abstract
Temperature estimation and prediction are critical for online regulation of temperature and hot spots on today's high performance processors. In this paper, we present a new method, called FRETEP, to accurately estimate and predict the full-chip temperature at runtime under more practical conditions where we have inaccurate thermal model, less accurate power estimations and limited number of on-chip physical thermal sensors. FRETEP employs a number of new techniques to address this problem. First, we propose a new thermal sensor based error compensation method to correct the errors due to the inaccuracies in thermal model and power estimations. Second, we raise a new correlation based method for error compensation estimation with limited number of thermal sensors. Third, we optimize the compact modeling technique and integrate it into the error compensation process in order to perform the thermal estimation with error compensation at runtime. Last but not least, to enable accurate temperature prediction for the emerging predictive thermal management, we design a full-chip thermal prediction framework employing time series prediction method. Experimental results show FRETEP accurately estimates and predicts the full-chip thermal behavior with very low overhead introduced and compares very favorably with the Kalman filter based approach on standard SPEC benchmarks.

2010 A new TCB cache to efficiently manage TCP sessions for web servers
abstract
TCP/IP, the most commonly used network protocol, consumes a significant portion of time in Internet servers. While a wide spectrum of studies has been done to reduce its processing overhead such as TOE and Direct Cache Access, most of them did studies solely from the per-packet perspective and concentrated on the packet memory access overhead. They ignored per-session data TCP Control Block (TCB), which poses a challenge in web servers with a large volume of concurrent sessions.

2010 A new IP lookup cache for high performance IP routers
abstract
IP lookup is in the critical data path in a high speed router. In this paper, we propose a new on-chip IP cache architecture for a high performance IP lookup. We design the IP cache along two important axes: cache indexing and cache replacement policies. First, we study various hash performance and employ 2-Universal hashing for our IP cache. Second, coupled with our cache indexing scheme, we present a progressive cache replacement policy by considering Internet traffic characteristics. Our experiments with IP traces show that our IP cache reduces the miss ratio by 15% and a small 32KB IP cache can achieve as high as 2Tbps routing throughput.

2009 An adaptive hash-based multilayer scheduler for L7-filter on a highly threaded hierarchical multi-core server
abstract
Ubiquitous multi-core-based web servers and edge routers are increasingly popular in deploying computationally intensive Deep Packet Inspection (DPI) programs. Previous work has shown the benefits of connection locality-based scheduling on multi-core servers to improve L7-filter performance. However, we show that highly threaded hierarchical multi-core processors, such as the Sun Niagara 2 processor, accumulate imbalanced workload at each resource layer. This workload imbalance potentially offsets the benefits from connection locality. In addition, connection-locality-based load balance fails to work when network traffic is unevenly distributed.

2009 EINIC: an architecture for high bandwidth network I/O on multi-core processors
abstract
This paper proposes a new server architecture EINIC (Enhanced Integrated NIC) for multi-core processors to tackle the mismatch between network speed and host computational capacity. Similar to prior work, EINIC integrates a redesigned NIC onto a CPU. However, we extend the integrated NIC (INIC) to multicore platforms and examine its behaviors with the network receiving optimization. Additionally, by exploiting NICs proximity to CPUs, we also design an I/O-aware last level shared cache (LLC). Our I/O-aware design allows us to split the cache into an I/O cache and a general cache in a flexible way. It ameliorates cache interferences between network and non-network data. Our simulation results show that EINIC not only attacks the mismatch, but also ameliorates the cache interference.

2008 A scalable multithreaded L7-filter design for multi-core servers
abstract
L7-filter is a significant component in Linux's QoS framework that classifies network traffic based on application layer data. It enables subsequent distribution of network resources in respect to the priority of applications. Considerable research has been reported to deploy multi-core architectures for computationally intensive applications. Unfortunately, the proliferation of multi-core architectures has not helped fast packet processing due to: 1) the lack of efficient parallelism in legacy network programs, and 2) the non-trivial configuration for scalable utilization on multi-core servers. In this paper, we propose a highly scalable parallelized L7-filter system architecture with affinity-based scheduling on a multi-core server. We start with an analytical study of the system architecture based on an offline design. Similar to Receive Side Scaling (RSS) in the NIC, we develop a model to explore the connection level parallelism in L7-filter and propose an affinity-based scheduler to optimize system scalability. Performance results show that our optimized L7-filter has superior scalability over the naive multithreaded version. It improves system performance by about 50% when all the cores are deployed.

2008 Software techniques to improve virtualized I/O performance on multi-core systems
abstract
Virtualization technology is now widely deployed on high performance networks such as 10-Gigabit Ethernet (10GE). It offers useful features like functional isolation, manageability and live migration. Unfortunately, the overhead of network I/O virtualization significantly degrades the performance of network-intensive applications. Two major factors of loss in I/O performance result from the extra driver domain to process I/O requests and the extra scheduler inside the virtual machine monitor (VMM) for scheduling domains.
