2025 HybridTier: an Adaptive and Lightweight CXL-Memory Tiering System
abstract
Modern workloads are demanding increasingly larger memory capacity. Compute Express Link (CXL)-based memory tiering has emerged as a promising solution for addressing this problem by utilizing traditional DRAM alongside slow-tier CXL memory devices. We analyze prior tiering systems and observe two challenges for high-performance memory tiering: adapting to skewed but dynamically varying data hotness distributions while minimizing memory and cache overhead due to tiering. To address these challenges, we propose HybridTier, an adaptive and lightweight tiering system for CXL memory. HybridTier tracks both long-term data access frequency and short-term access momentum simultaneously to accurately capture and adapt to shifting hotness distributions. HybridTier reduces the metadata memory overhead by tracking data accesses probabilistically, obtaining higher memory efficiency by trading off a small amount of tracking inaccuracy that has a negligible impact on application performance. To reduce cache overhead, HybridTier uses lightweight data structures that optimize for data locality to track data hotness. Our evaluations show that HybridTier outperforms prior systems by up to 91% (19% geomean), incurring 2.0-7.8x less memory overhead and 1.7-3.5x less cache misses.

abstract
Modern deep learning (DL) training is memory-consuming, constrained by the memory capacity of each computation component and cross-device communication bandwidth. In response to such constraints, current approaches include increasing parallelism in distributed training and optimizing inter-device communication. However, model parameter communication is becoming a key performance bottleneck in distributed DL training. To improve parameter communication performance, we propose COARSE, a disaggregated memory extension for distributed DL training. COARSE is built on modern cache-coherent interconnect (CCI) protocols and MPI-like collective communication for synchronization, to allow low-latency and parallel access to training data and model parameters shared among worker GPUs. To enable high bandwidth transfers between GPUs and the disaggregated memory system, we propose a decentralized parameter communication scheme to decouple and localize parameter synchronization traffic. Furthermore, we propose dynamic tensor routing and partitioning to fully utilize the non-uniform serial bus bandwidth varied across different cloud computing systems. Finally, we design a deadlock avoidance and dual synchronization to ensure high-performance parameter synchronization. Our evaluation shows that COARSE achieves up to 48.3% faster DL training compared to the state-of-the-art MPI AllReduce communication.

abstract
Scalable server-grade non-volatile RAM (NVRAM) DIMMs became commercially available with the release of Intel's Optane DIMM. Recent studies on Optane DIMM systems unveil discrepant performance characteristics, compared to what many researchers assumed before the product release. Most of these studies focus on system software design and performance analysis. To thoroughly analyze the source of this discrepancy and facilitate real-NVRAM-aware architecture design, we propose a framework that characterizes and models Optane DIMM's microarchitecture. Our framework consists of a Low-level profilEr for Non-volatile memory Systems (LENS) and a Validated cycle-Accurate NVRAM Simulator (VANS). LENS allows us to comprehensively analyze the performance attributes and reverse engineer NVRAM microarchitectures. Based on LENS characterization, we develop VANS, which models the sophisticated microarchitecture design of Optane DIMM, and is validated by comparing with the detailed performance characteristics of Optane-DIMM-attached Intel servers. VANS adopts a modular design that can be easily modified to extend to other NVRAM architecture designs; it can also be attached to full-system simulators, such as gem51. By using LENS and VANS, we develop two architectural optimizations on top of Optane DIMM, Lazy Cache and Pre-translation, which significantly improve cloud workload performance.
