2026 ActiShade: Activating Overshadowed Knowledge to Guide Multi-Hop Reasoning in Large Language Models
abstract
In multi-hop reasoning, multi-round retrieval-augmented generation (RAG) methods typically rely on LLM-generated content as the retrieval query. However, these approaches are inherently vulnerable to knowledge overshadowing—a phenomenon where critical information is overshadowed during generation. As a result, the LLM-generated content may be incomplete or inaccurate, leading to irrelevant retrieval and causing error accumulation during the iteration process. To address this challenge, we propose ActiShade, which detects and activates overshadowed knowledge to guide large language models(LLMs) in multi-hop reasoning. Specifically, ActiShade iteratively detects the overshadowed keyphrase in the given query, retrieves documents relevant to both the query and the overshadowed keyphrase, and generates a new query based on the retrieved documents to guide the next-round iteration. By supplementing the overshadowed knowledge during the formulation of next-round queries while minimizing the introduction of irrelevant noise, ActiShade reduces the error accumulation caused by knowledge overshadowing. Extensive experiments show that ActiShade outperforms existing methods across multiple datasets and LLMs.

2026 Temporal Group Constrained Transformer With Deformable Landmark Attention for Video Dimensional Emotion Recognition
abstract
Video dimensional emotion recognition aims to map human affect into the dimensional emotion space based on visual signals. Recent works notice that it is beneficial to locate key facial regions related to human emotion perception, as well as establish long-term temporal dependencies. While preliminary attempts have been made, there still exists much space for further improvements. In this paper, to better exploit key facial regions, we propose the Temporal cue guided Deformable Landmark Spatial (TDLS) transformer which attends to key facial regions in a data-dependent manner. We also propose the temporal cue guided frame representation learning to learn the spatial representation of each frame by considering features of other frames together. To better model temporal dependencies, we propose the Multi-layer Group Constrained Temporal (MGCT) transformer to summarize features of frames to multi-layer groups, perform group-to-group communications, and let group-level features guide the frame-level emotion recognition. We also introduce cross-clip representation learning to generate consistent results across different clips and videos. Extensive experiments are conducted on two benchmark datasets and superior results are achieved by our method compared to state-of-the-art approaches.

2025 Dually Self-Improved Counterfactual Data Augmentation Using Large Language Model
abstract
Counterfactual data augmentation, which generates minimally edited tokens to alter labels, has become a key approach to improving model robustness in natural language processing. It is usually implemented by first identifying the causal terms and then modifying these terms to create counterfactual candidates. The emergence of large language models (LLMs) has effectively facilitated the task of counterfactual data augmentation. However, existing LLMbased approaches still face some challenges in 1) accurately extracting the task-specific causal terms, and 2) the quality of LLM-generated counterfacts. To address the issues, we propose a dually self-improved counterfactual data augmentation method using LLM.On the one hand, we design a self-improved strategy employing the attention distribution of the task model to identify the task-specific causal terms, which is lightweight and task-specific.On the other hand, a second self-improved strategy based on direct preference optimization is utilized to refine LLM-generated counterfacts, achieving high-quality counterfacts. Finally, a balanced loss preventing over-emphasis on augmentated data is proposed to retrain the task model on the fusion of existing data and generated counterfacts.Extensive experiments on multiple benchmarks demonstrate the effectiveness of our proposed method in generating high-quality counterfacts for improving task performance.

2025 LoCal: Logical and Causal Fact-Checking with LLM-Based Multi-Agents
abstract
With the development of social media, people are exposed to a vast amount of unverified information, making fact-checking particularly important. Existing fact-checking methods primarily encourage breaking down claims into more easily solvable sub-tasks, and deriving final answers through reasoning with external evidence. However, these models face logical issues regarding whether and how the sub-tasks can logically be combined to form the original claims, and encounter causal errors in the reasoning process due to insufficient evidence or hallucinations from LLMs. In addition, they often suffer from a lack of interpretability. In this paper, we propose Logical and Causal fact-checking (LoCal), a novel fact-checking framework based on multiple LLM-based agents. The usage of multi-agent systems is due to their increasingly demonstrated ability to perform complex tasks in a manner similar to humans. LoCal primarily consists of a decomposing agent, multiple reasoning agents, and two evaluating agents. Specifically, the decomposing agent first utilizes the in-context learning ability of LLMs to break down complex claims into simpler sub-tasks, including fact verification tasks and question answering tasks. Afterwards, two types of reasoning agents are respectively utilized to retrieve external knowledge to address the fact verification tasks that require comparative analysis skills, and the question answering tasks that necessitate the ability of information extraction from evidence. We then combine the sub-tasks and their corresponding responses to generate a solution for evaluation. In order to enhance logical and causal consistency, two evaluating agents are respectively employed to examine whether the generated solution is logically equivalent to the original claim and determine whether the solution still holds when challenged by the counterfactual label. The evaluating agents provide confidence degrees for the solutions based on the evaluation results and iteratively correct the logical and causal errors in the reasoning process. We evaluate LoCal on two challenging datasets, and the results show that LoCal significantly outperforms all the baseline models across different settings of evidence availability. In addition, LoCal offers better interpretability by providing a structured solution along with detailed evaluating processes. We believe LoCal will provide valuable insights for future misinformation detection.

2025 Personalized News Recommendation Towards the Era of LLMs: Review and Prospect
abstract
With the prevalence of online news services, personalized news recommendation (PNR) has played an indispensable role in meeting users' needs and mitigating information overload, with the aim of providing news articles that cater to user preferences. Despite significant progress made in the field of PNR over the past few decades, their performances are still hindered by some limitations, such as insufficient news modeling, difficulties in effectively modeling diverse user interests, and ignorance of fine-grained matching signals. It is fortunate that the emergence of large language models (LLMs) provides a promising insight into empowering the capabilities of news recommendation. Known for their impressive capabilities of natural language understanding and generation, LLMs have achieved disruptive achievements in various natural language processing (NLP) tasks, which motivates us to integrate LLMs into news recommendation and benefits from them to make up existing deficiencies. In this paper, we conduct a comprehensive review of current efforts made towards utilizing LLMs for PNR, with a focus on three core modules involved in the news recommendation process, i.e., news modeling, user modeling, and accurate matching. We systematically discuss and analyze relevant works under each focus. In addition, we point out several potential research directions to provide more inspiration for future investigation in this thriving field.

2025 Efficient and Effective Role Player: A Compact Knowledge-grounded Persona-based Dialogue Model Enhanced by LLM Distillation
abstract
Incorporating explicit personas into dialogue models is critical for generating responses that fulfill specific user needs and preferences, creating a more personalized and engaging interaction. Early works on persona-based dialogue generation directly concatenate the persona descriptions and dialogue history into relatively small pre-trained language models (PLMs) for response generation, which leads to uninformative and inferior results due to the sparse persona information and the limited model generation capabilities. Recently, large language models (LLMs) have shown their surprising capabilities in language generation. Prompting the LLMs with the persona descriptions for role-playing dialogue generation has also achieved promising results. However, deploying LLMs is challenging for practical applications due to their large scale, spurring efforts to distill the generation capabilities into more concise and compact models through teacher-student learning. In this article, we propose an efficient compact K nowledge-grounded P ersona-based D ialogue model enhanced by LLM D istillation (KPDD). Specifically, first, we propose to enrich the annotated persona descriptions by integrating external knowledge graphs (KGs) with a mixed encoding network, coupled with a mixture of experts (MoE) module for both informative and diverse response generation. The mixed encoding network contains multiple layers of modality interaction operations, enabling information from both modalities propagates to the other. Second, to fully exploit the generation capabilities of LLMs, we turn to the distillation technique to improve the generation capabilities of our model, facilitated by a natural language inference (NLI)-based filtering mechanism to extract high-quality information from LLMs. In addition, we employ a curriculum learning strategy to train our model on the high-quality filtered distilled data and progressively on the relatively noisy original data, enhancing its adaptability and performance. Extensive experiments show that KPDD outperforms state-of-the-art baselines in terms of both automatic and human evaluation.

2024 LLM vs Small Model? Large Language Model Based Text Augmentation Enhanced Personality Detection Model
abstract
Personality detection aims to detect one's personality traits underlying in social media posts. One challenge of this task is the scarcity of ground-truth personality traits which are collected from self-report questionnaires. Most existing methods learn post features directly by fine-tuning the pre-trained language models under the supervision of limited personality labels. This leads to inferior quality of post features and consequently affects the performance. In addition, they treat personality traits as one-hot classification labels, overlooking the semantic information within them. In this paper, we propose a large language model (LLM) based text augmentation enhanced personality detection model, which distills the LLM's knowledge to enhance the small model for personality detection, even when the LLM fails in this task. Specifically, we enable LLM to generate post analyses (augmentations) from the aspects of semantic, sentiment, and linguistic, which are critical for personality detection. By using contrastive learning to pull them together in the embedding space, the post encoder can better capture the psycho-linguistic information within the post representations, thus improving personality detection. Furthermore, we utilize the LLM to enrich the information of personality labels for enhancing the detection performance. Experimental results on the benchmark datasets demonstrate that our model outperforms the state-of-the-art methods on personality detection.

2024 KB-Plugin: A Plug-and-play Framework for Large Language Models to Induce Programs over Low-resourced Knowledge Bases
abstract
Program induction (PI) has become a promising paradigm for using knowledge bases (KBs) to help large language models (LLMs) answer complex knowledge-intensive questions.Nonetheless, PI typically relies on a large number of parallel question-program pairs to make the LLM aware of the schema of a given KB, and is thus challenging for many low-resourced KBs that lack annotated data.To this end, we propose KB-Plugin, a plug-and-play framework that enables LLMs to induce programs over any low-resourced KB.Firstly, KB-Plugin adopts self-supervised learning to encode the detailed schema information of a given KB into a pluggable module, namely schema plugin.Secondly, KB-Plugin utilizes abundant annotated data from a rich-resourced KB to train another pluggable module, namely PI plugin, which can help the LLM extract questionrelevant schema information from the schema plugin of any KB and utilize the information to induce programs over this KB.Experiments show that KB-Plugin outperforms SoTA lowresourced PI methods with 25× smaller backbone LLM on both large-scale and domainspecific KBs, and even approaches the performance of supervised methods.

2024 NovaChart: A Large-scale Dataset towards Chart Understanding and Generation of Multimodal Large Language Models
abstract
Multimodal Large Language Models (MLLMs) have shown significant potential for chart understanding and generation. However, they are still far from achieving the desired effectiveness in practical applications. This could be due to the limitations of the used training chart data. Existing chart datasets suffer from scarcity of chart types, limited coverage of tasks, and insufficient scalability, making them incapable of effectively enhancing the chart-related capabilities of MLLMs. To tackle these obstacles, we construct NovaChart, a large-scale dataset for chart understanding and generation of MLLMs. NovaChart contains 47K high-resolution chart images and 856K chart-related instructions, covering 18 different chart types and 15 unique tasks of chart understanding and generation. To build NovaChart, we propose a data generation engine for metadata curation, chart visualization and instruction formulation. Chart metadata in NovaChart contains detailed annotations, i.e., data points, visual elements, source data and the visualization code of every chart. This additional information endows NovaChart with considerable scalability, as it can facilitate the extension of chart instruction data to a larger scale and greater diversity. We utilize NovaChart to train several open-source MLLMs. Experimental results demonstrate NovaChart empowers MLLMs with stronger capabilities in 15 chart understanding and generation tasks by a large-margin (35.47%-619.47%), bringing them a step closer to smart chart assistants. Our dataset is now available at https://github.com/Elucidator-V/NovaChart.

2024 Let Me Show You Step by Step: An Interpretable Graph Routing Network for Knowledge-based Visual Question Answering
abstract
Visual Question Answering based on external Knowledge Bases (KB-VQA) requires a model to incorporate knowledge beyond the content of given image and question for answer prediction. Most existing works made efforts on using graph neural networks or Multi-modal Large Language Models to incorporate external knowledge for answer generation. Despite the promising results, they have limited interpretability and exhibit a deficiency in handling questions with unseen answers. In this paper, we propose a novel interpretable graph routing network (GRN) which explicitly conducts entity routing over a constructed scene knowledge graph step by step for KB-VQA. At each step, GRN keeps an entity score vector representing how likely of each entity to be activated as the answer, and a transition matrix representing the transition probability from one entity to another. To answer the given question, GRN will focus on certain keywords of the question at each step and correspondingly conduct entity routing by transiting the entity scores according to the transition matrix computed referring to the focused question keywords. In this way, it clearly provides the reasoning process of KB-VQA and can handle the questions with unseen answers without distinction. Experiments on the benchmark dataset KRVQA have demonstrated that GRN improves the performance of KB-VQA by a large margin, surpassing existing state-of-the art KB-VQA methods and Multi-modal Large Language Models, as well as shows competent capability in handling unseen answers and good interpretability in KB-VQA.

2024 Span-Pair Interaction and Tagging for Dialogue-Level Aspect-Based Sentiment Quadruple Analysis
abstract
The Dialogue-level Aspect-based Sentiment Quadruple analysis (DiaASQ) task has recently received attention in the Aspect-Based Sentiment Analysis (ABSA) field. It aims to extract(target, aspect, opinion, sentiment) quadruples from multi-turn and multi-party dialogues. Compared to previous ABSA tasks focusing on text such as sentences, the DiaASQ task involves more complex contextual information and corresponding relations between terms, as well as longer sequences. These characteristics challenge existing methods that struggle to model explicit span-level interactions or have high computational costs. In this paper, we propose a span-pair interaction and tagging method to solve these issues, which includes a novel Span-pair Tagging Scheme (STS) and a simple and efficient Multi-level Representation Model (MRM). STS simplifies the DiaASQ task to a span-pair tagging task and explicitly captures complete span-level semantics by tagging span pairs. MRM efficiently models the dialogue structure information and span-level interactions by constructing multi-level contextual representation. Besides, we train a span ranker to improve the running efficiency of MRM. Extensive experiments on multilingual datasets demonstrate that our method outperforms existing state-of-the-art methods.

2024 Knowledge-Guided Transformer for Joint Theme and Emotion Classification of Chinese Classical Poetry
abstract
The classifications of the theme and emotion are essential for understanding and organizing Chinese classical poetry. Existing works often overlook the rich semantic knowledge derived from poem annotations, which contain crucial insights into themes and emotions and are instrumental in semantic understanding. Additionally, the complex interdependence and diversity of themes and emotions within poems are frequently disregarded. Hence, this paper introduces a Poetry Knowledge-augmented Joint Model (Poka) specifically designed for the multi-label classification of themes and emotions in Chinese classical poetry. Specifically, we first employ an automated approach to construct two semantic knowledge graphs for theme and emotion. These graphs facilitate a deeper understanding of the poems by bridging the semantic gap between the obscure ancient words and their modern Chinese counterparts. Representations related to themes and emotions are then acquired through a knowledge-guided mask-transformer. Moreover, Poka leverages the inherent correlations between themes and emotions by adopting a joint classification strategy with shared training parameters. Extensive experiments demonstrate that our model achieves state-of-the-art performance on both theme and emotion classifications, especially on tail labels.

2024 A Survey of Knowledge Enhanced Pre-Trained Language Models
abstract
Pre-trained Language Models (PLMs) which are trained on large text corpus via self-supervised learning method, have yielded promising performance on various tasks in Natural Language Processing (NLP). However, though PLMs with huge parameters can effectively possess rich knowledge learned from massive training text and benefit downstream tasks at the fine-tuning stage, they still have some limitations such as poor reasoning ability due to the lack of external knowledge. Research has been dedicated to incorporating knowledge into PLMs to tackle these issues. In this paper, we present a comprehensive review of Knowledge Enhanced Pre-trained Language Models (KE-PLMs) to provide a clear insight into this thriving field. We introduce appropriate taxonomies respectively for Natural Language Understanding (NLU) and Natural Language Generation (NLG) to highlight these two main tasks of NLP. For NLU, we divide the types of knowledge into four categories: linguistic knowledge, text knowledge, knowledge graph (KG), and rule knowledge. The KE-PLMs for NLG are categorized into KG-based and retrieval-based methods. Finally, we point out some promising future directions of KE-PLMs.

2024 Multimodal Dialog Systems with Dual Knowledge-enhanced Generative Pretrained Language Model
abstract
Text response generation for multimodal task-oriented dialog systems, which aims to generate the proper text response given the multimodal context, is an essential yet challenging task. Although existing efforts have achieved compelling success, they still suffer from two pivotal limitations: (1) overlook the benefit of generative pretraining and (2) ignore the textual context-related knowledge . To address these limitations, we propose a novel dual knowledge-enhanced generative pretrained language mode for multimodal task-oriented dialog systems (DKMD), consisting of three key components: dual knowledge selection , dual knowledge-enhanced context learning , and knowledge-enhanced response generation . To be specific, the dual knowledge selection component aims to select the related knowledge according to both textual and visual modalities of the given context. Thereafter, the dual knowledge-enhanced context learning component targets seamlessly, integrating the selected knowledge into the multimodal context learning from both global and local perspectives, where the cross-modal semantic relation is also explored. Moreover, the knowledge-enhanced response generation component comprises a revised BART decoder, where an additional dot-product knowledge-decoder attention sub-layer is introduced for explicitly utilizing the knowledge to advance the text response generation. Extensive experiments on a public dataset verify the superiority of the proposed DKMD over state-of-the-art competitors.

Due to the rapid upgrade of social platforms, most of today's fake news is published and spread in a multi-modal form. Most existing multi-modal fake news detection methods neglect the fact that some label-specific features learned from the training set cannot generalize well to the testing set, thus inevitably suffering from the harm caused by the latent data bias.In this paper, we analyze and identify the psycholinguistic bias in the text and the bias of inferring news label based on only image features. We mitigate these biases from a causality perspective and propose a Causal intervention and Counterfactual reasoning based Debiasing framework (CCD) for multi-modal fake news detection. To achieve our goal, we first utilize causal intervention to remove the psycholinguistic bias which introduces the spurious correlations between text features and news label. And then, we apply counterfactual reasoning by imagining a counterfactual world where each news has only image features for estimating the direct effect of the image. Therefore we can eliminate the image-only bias by deducting the direct effect of the image from the total effect on labels.Extensive experiments on two real-world benchmark datasets demonstrate the effectiveness of our framework for improving multi-modal fake news detection.

2023 Knowledgeable Parameter Efficient Tuning Network for Commonsense Question Answering
abstract
Commonsense question answering is important for making decisions about everyday matters.Although existing commonsense question answering works based on fully fine-tuned PLMs have achieved promising results, they suffer from prohibitive computation costs as well as poor interpretability. Some works improve the PLMs by incorporating knowledge to provide certain evidence, via elaborately designed GNN modules which require expertise. In this paper, we propose a simple knowledgeable parameter efficient tuning network to couple PLMs with external knowledge for commonsense question answering.Specifically, we design a trainable parameter-sharing adapter attached to a parameter-freezing PLM to incorporate knowledge at a small cost. The adapter is equipped with both entity-and query-related knowledge via two auxiliary knowledge-related tasks (i.e., span masking and relation discrimination). To make the adapter focus on the relevant knowledge, we design gating and attention mechanisms to respectively filter and fuse the query information from the PLM.Extensive experiments on two benchmark datasets show that KPE is parameter-efficient and can effectively incorporate knowledge for improving commonsense question answering.

2023 Verbalizer or Classifier? A New Prompt Learning Model for Event Causality Identification
abstract
Existing models for event causality identification (ECI) are mainly based on pre-training and fine-tuning paradigm, which are facing the problem of data lacking. Recent works have suggested that prompt learning has remarkable superiority in low-data scenario. The core idea of prompt learning is to insert text pieces, i.e., template, to the input and transform an ECI problem into a masked language modeling problem, in which a crucial part, dubbed as verbalizer, is to construct the projection between label space and word space. Previous works construct verbalizer through handcrafted or auto-searched way, which does not fully take the information of the MASK token. In this work, we propose a novel prompt learning model based on a classifier for ECI task. To be specific, we employ a multilayer perceptron (MLP) based classifier rather than verbalizer to incorporate full information provided at [MASK] token, and then project the output of MLP to the label space for ECI task. Experimental results on two benchmarks EventStoryLine and Causal-TimeBank demonstrate that our model has a huge superiority than previous models.

2023 Causal Inference for Leveraging Image-Text Matching Bias in Multi-Modal Fake News Detection
abstract
Multi-modal fake news detection has drawn considerable attention with the development of online social media. Existing methods primarily conduct direct cross-modal fusion, while ignoring the image-text matching degree which may introduce unexpected bias. This work studies an unexplored problem in multi-modal fake news detection – how to deconfound and leverage the image-text matching bias to improve the performance of fake news detection. The key lies in two aspects: how to remove the confounding effect of the image-text matching bias during training, and how to utilize the bias in the inference stage since the news with mismatched image and text is more likely to be fake. To achieve our goal, we formulate the fake news detection task as a causal graph that reflects the cause-effect factors, and propose a novel framework –Causal Inference forLeveragingImage-textMatchingBias (CLIMB) in multi-modal fake news detection. To our best knowledge, this is the first work that considers the image-text matching degree into the fake news detection task with the approach of causal inference. CLIMB can be applied to any fake news detection models with visual and textual features as inputs. Extensive experiments on two real-world datasets validate the effectiveness of CLIMB.

2022 Contrastive Graph Transformer Network for Personality Detection
abstract
Personality detection is to identify the personality traits underlying social media posts. Most of the existing work is mainly devoted to learning the representations of posts based on labeled data. Yet the ground-truth personality traits are collected through time-consuming questionnaires. Thus, one of the biggest limitations lies in the lack of training data for this data-hungry task. In addition, the correlations among traits should be considered since they are important psychological cues that could help collectively identify the traits. In this paper, we construct a fully-connected post graph for each user and develop a novel Contrastive Graph Transformer Network model (CGTN) which distills potential labels of the graphs based on both labeled and unlabeled data. Specifically, our model first explores a self-supervised Graph Neural Network (GNN) to learn the post embeddings. We design two types of post graph augmentations to incorporate different priors based on psycholinguistic knowledge of Linguistic Inquiry and Word Count (LIWC) and post semantics. Then, upon the post embeddings of the graph, a Transformer-based decoder equipped with post-to-trait attention is exploited to generate traits sequentially. Experiments on two standard datasets demonstrate that our CGTN outperforms the state-of-the-art methods for personality detection.

2022 Multi-Relation Extraction via A Global-Local Graph Convolutional Network
abstract
Relation extraction (RE) extracts the semantic relations among entities in a sentence, which converts the unstructured text into structured and easy-to-understand information. Although RE has been studied over decades, it still faces two kinds of research challenges that are not well addressed thus far: 1) joint consideration of the global sentence structure and the local entity interaction, and 2) effective solution to the overlapping triplets within the same sentence. To tackle these issues, in this paper, we present global-local graph-based convolutional network towards multi-relation extraction, GAME for short. In particular, we devise two layers of graph convolutional network (GCN) with different structures to complete the feature extraction, which effectively improves the capability of relation extraction. Moreover, we implement the GCN layers via the pure GCN model and graph attention network respectively for further comparison. Besides, we adopt a classification strategy to extract relation among entity pairs, assisting in solving the more complicated problem of overlapping triplets in RE. Extensive experiments have been conducted on two widely-used benchmark datasets, demonstrating that our model significantly outperforms several state-of-the-art methods. As a side product, we have released our data, codes and parameter settings to facilitate other researchers.

2022 RHINE: Relation Structure-Aware Heterogeneous Information Network Embedding
abstract
Heterogeneous information network (HIN) embedding aims to learn the low-dimensional representations of nodes while preserving structures and semantics in HINs. Although most existing methods consider heterogeneous relations and achieve promising performance, they usually employ one single model for all relations without distinction, which inevitably restricts the capability of HIN embedding. In this paper, we argue that heterogeneous relations have different structural characteristics, and propose a novel Relation structure-aware HIN Embedding model, called RHINE. By exploring four real-world networks with thorough analysis, we present two structure-related measures which consistently distinguish heterogeneous relations into two categories: Affiliation Relations (ARs) and Interaction Relations (IRs). To respect the distinctive structural characteristics of relations, in RHINE, we propose different models specifically tailored to handle ARs and IRs, which can better capture the structures in HINs. Finally, we combine and optimize these models in a unified manner. Furthermore, considering that nodes connected via heterogeneous relations may have multi-aspect semantics and each relation focuses on one aspect, we introduce relation-specific projection matrices to learn node and relation embeddings in separate spaces rather than a common space, which can better preserve the semantics in HINs, referring to a new model RHINE-M. Experiments on four real-world datasets demonstrate that our models significantly outperform the state-of-the-art methods in four tasks.

2021 Sequence-aware Heterogeneous Graph Neural Collaborative Filtering
abstract
With the booming of the internet, a popular recommendation scenario has played a vital role in information acquisition for user where the latent heterogeneous collaborative signals and sequential patterns underlying a user's historical behaviors are important for better inferring which item she prefers to interact with next time. Traditional heterogeneous information network based methods or sequential recommendation methods either consider only heterogeneous collaborative signals in the interactions or model user embedding based on only their own item interaction sequence, which either can hardly capture a user's dynamic preferences or face a common data sparsity problem. In this paper, we propose a novel Sequence-aware Heterogeneous graph neural Collaborative Filtering model, called SHCF, which can address the above problems by considering both the high-order heterogeneous collaborative signals and sequential information. Specifically, we first construct a heterogeneous information network (HIN) by enriching the user-item bipartite graph with additional attribute information, and then design novel message passing layers for learning user and item embedding. For user embedding, we consider the sequential information to capture user's dynamic interests over time with a position-aware self-attention mechanism, and capture user's fine-grained static preferences on different aspects of an item with an element-wise attention mechanism. For item embedding, we carefully incorporate the heterogeneous attribute information with dual-level attention, which alleviates the data sparsity problem. Extensive experiments on three real-world datasets illustrate that our model can improve the recommendation performance compared with the state-of-the-art methods.

2021 HGAT: Heterogeneous Graph Attention Networks for Semi-supervised Short Text Classification
abstract
Short text classification has been widely explored in news tagging to provide more efficient search strategies and more effective search results for information retrieval. However, most existing studies, concentrating on long text classification, deliver unsatisfactory performance on short texts due to the sparsity issue and the insufficiency of labeled data. In this article, we propose a novel heterogeneous graph neural network-based method for semi-supervised short text classification, leveraging full advantage of limited labeled data and large unlabeled data through information propagation along the graph. Specifically, we first present a flexible heterogeneous information network (HIN) framework for modeling short texts, which can integrate any type of additional information and meanwhile capture their relations to address the semantic sparsity. Then, we propose Heterogeneous Graph Attention networks (HGAT) to embed the HIN for short text classification based on a dual-level attention mechanism, including node-level and type-level attentions. To efficiently classify new coming texts that do not previously exist in the HIN, we extend our model HGAT for inductive learning, avoiding re-training the model on the evolving HIN. Extensive experiments on single-/multi-label classification demonstrates that our proposed model HGAT significantly outperforms state-of-the-art methods across the benchmark datasets under both transductive and inductive learning.

2020 Graph Neural News Recommendation with Unsupervised Preference Disentanglement
abstract
With the explosion of news information, personalized news recommendation has become very important for users to quickly find their interested contents. Most existing methods usually learn the representations of users and news from news contents for recommendation. However, they seldom consider high-order connectivity underlying the user-news interactions. Moreover, existing methods failed to disentangle a user’s latent preference factors which cause her clicks on different news. In this paper, we model the user-news interactions as a bipartite graph and propose a novel Graph Neural News Recommendation model with Unsupervised Preference Disentanglement, named GNUD. Our model can encode high-order relationships into user and news representations by information propagation along the graph. Furthermore, the learned representations are disentangled with latent preference factors by a neighborhood routing algorithm, which can enhance expressiveness and interpretability. A preference regularizer is also designed to force each disentangled subspace to independently reflect an isolated preference, improving the quality of the disentangled representations. Experimental results on real-world news datasets demonstrate that our proposed model can effectively improve the performance of news recommendation and outperform state-of-the-art news recommendation methods.

2020 Adversarial Label-Flipping Attack and Defense for Graph Neural Networks
abstract
With the great popularity of Graph Neural Networks (GNNs), the robustness of GNNs to adversarial attacks has received increasing attention. However, existing works neglect adversarial label-flipping attacks, where the attacker can manipulate an unnoticeable fraction of training labels. Exploring the robustness of GNNs to label-flipping attacks is highly critical, especially when labels are collected from external sources and false labels are easy to inject (e.g., recommendation systems). In this work, we introduce the first study of adversarial label-flipping attacks on GNNs. We propose an effective attack model LafAK based on approximated closed form of GNNs and continuous surrogate of non-differentiable objective, efficiently generating attacks via gradient-based optimizers. Furthermore, we show that one key reason for the vulnerability of GNNs to label-flipping attack is overfitting to flipped nodes. Based on this observation, we propose a defense framework which introduces a community-preserving self-supervised task as regularization to avoid overfitting. We demonstrate the effectiveness of our proposed attack model to GNNs on four real-world datasets. The effectiveness of our defense framework is also well validated by the substantial improvements of defense based GNN and its variants under label-flipping attacks.

2019 Metapath-guided Heterogeneous Graph Neural Network for Intent Recommendation
abstract
With the prevalence of mobile e-commerce nowadays, a new type of recommendation services, called intent recommendation, is widely used in many mobile e-commerce Apps, such as Taobao and Amazon. Different from traditional query recommendation and item recommendation, intent recommendation is to automatically recommend user intent according to user historical behaviors without any input when users open the App. Intent recommendation becomes very popular in the past two years, because of revealing user latent intents and avoiding tedious input in mobile phones. Existing methods used in industry usually need laboring feature engineering. Moreover, they only utilize attribute and statistic information of users and queries, and fail to take full advantage of rich interaction information in intent recommendation, which may result in limited performances. In this paper, we propose to model the complex objects and rich interactions in intent recommendation as a Heterogeneous Information Network. Furthermore, we present a novel M etapath-guided E mbedding method for I ntent Rec ommendation~(called MEIRec). In order to fully utilize rich structural information, we design a metapath-guided heterogeneous Graph Neural Network to learn the embeddings of objects in intent recommendation. In addition, in order to alleviate huge learning parameters in embeddings, we propose a uniform term embedding mechanism, in which embeddings of objects are made up with the same term embedding space. Offline experiments on real large-scale data show the superior performance of the proposed MEIRec, compared to representative methods. Moreover, the results of online experiments on Taobao e-commerce platform show that MEIRec not only gains a performance improvement of 1.54% on CTR metric, but also attracts up to 2.66% of new users to search queries.

2019 Virtually Trying on New Clothing with Arbitrary Poses
abstract
Thanks to the recent advance in the multimedia techniques, increasing research attention has been paid to the virtual try-on task, especially with the 2D image modeling. The traditional try-on task aims to align the target clothing item naturally to the given person's body and hence present a try-on look of the person. However, in practice, people may also be interested in their try-on looks with different poses. Therefore, in this work, we introduce a new try-on setting, which enables the changes of both the clothing item and the person's pose. Towards this end, we propose a pose-guided virtual try-on scheme based on the generative adversarial networks (GANs) with a bi-stage strategy. In particular, in the first stage, we propose a shape enhanced clothing deformation model for deforming the clothing item, where the user body shape is incorporated as the intermediate guidance. For the second stage, we present an attentive bidirectional GAN, which jointly models the attentive clothing-person alignment and bidirectional generation consistency. For evaluation, we create a large-scale dataset, FashionTryOn, comprising $28,714$ triplets with each consisting of a clothing item image and two model images in different poses. Extensive experiments on FashionTryOn validate the superiority of our model over the state-of-the-art methods.

2017 What Happens Next? Future Subevent Prediction Using Contextual Hierarchical LSTM
abstract
Events are typically composed of a sequence of subevents. Predicting a future subevent of an event is of great importance for many real-world applications. Most previous work on event prediction relied on hand-crafted features and can only predict events that already exist in the training data. In this paper, we develop an end-to-end model which directly takes the texts describing previous subevents as input and automatically generates a short text describing a possible future subevent. Our model captures the two-level sequential structure of a subevent sequence, namely, the word sequence for each subevent and the temporal order of subevents. In addition, our model incorporates the topics of the past subevents to make context-aware prediction of future subevents. Extensive experiments on a real-world dataset demonstrate the superiority of our model over several state-of-the-art methods.

2015 TSDPMM: Incorporating Prior Topic Knowledge into Dirichlet Process Mixture Models for Text Clustering
abstract
Dirichlet process mixture model (DPM-M) has great potential for detecting the underlying structure of data.Extensive studies have applied it for text clustering in terms of topics. However, due to the unsupervised nature, the topic clusters are always less satisfactory.Considering that people often have some prior knowledge about which potential topics should exist in given data, we aim to incorporate such knowledge into the DPMM to improve text clustering. We propose a novel model TSDPMM based on a new seeded Pólya urn scheme.Experimental results on document clustering across three datasets demonstrate our proposed TSDPMM significantly outperforms stateof-the-art DPMM model and can be applied in a lifelong learning framework.
