On the Communication Complexity of Decentralized Stochastic Bilevel OptimizationabstractAbstract Stochastic bilevel optimization finds widespread applications in machine learning, including meta-learning, hyperparameter optimization, and neural architecture search. To extend stochastic bilevel optimization to distributed data, several decentralized stochastic bilevel optimization algorithms have been developed. However, existing methods often suffer from slow convergence rates and high communication costs in heterogeneous settings, limiting their applicability to real-world tasks. To address these issues, we propose two novel decentralized stochastic bilevel gradient descent algorithms based on simultaneous and alternating update strategies. Our algorithms can achieve faster convergence rates and lower communication costs than existing methods. Importantly, our convergence analyses do not rely on strong assumptions regarding heterogeneity. More importantly, our theoretical analyses clearly disclose how the computation and communication regarding the Hessian-inverse-vector product under the heterogeneous setting affects the convergence rate. To the best of our knowledge, this is the first time such favorable theoretical results have been achieved with mild assumptions in the heterogeneous setting. Furthermore, we demonstrate how to establish the convergence rate for the alternating update strategy when combined with the variance-reduced gradient. Finally, experimental results confirm the efficacy of our algorithms. My T. Thai, Jie Wu 0001, Hongchang Gao

Swapping and Purification Scheme Optimization for Entanglement Distribution in Quantum NetworksabstractSwapping and purification are the two fundamental building blocks for high-fidelity entanglement distribution in multi-hop quantum networks. Unfortunately, it is still a mystery how they intertwine with each other to affect the fidelity and cost of end-to-end entanglements. Current scheduling algorithms consider this problem under relatively limited assumptions and a critical yet unjustified conjecture. In this work, we first consider more general assumptions with operation failures and, accordingly, extend a tree-based modeling for joint swapping and purification. Then, we analytically prove the previous conjecture that the optimal strategy underBinary systemis always to purify the entanglements before any swapping. This sheds light on the protocol and device design for quantum networks. We then further propose a tree-based algorithm, which can efficiently schedule swapping and purification along a path for bothBinaryandWerner systems. Extensive simulations of the proposed method against state-of-the-art solutions show that our method uses fewer entanglements to establish qualified end-to-end entanglements, and thus achieves higher network throughput. | 2025 | Sharpness-Aware Optimization Through Variance Suppression on Deep AUC MaximizationabstractSharpness-aware minimization (SAM) is widely rec-ognized for its ability to improve the generalization of deep neural networks by transforming the optimization problem into a minimax problem, aiming to minimize the maximum loss caused by adversarial parameter perturbations within a neighborhood. However, existing work almost exclusively focuses on the original minimization optimization, with very little attention paid to the minimax optimization. In this paper, we introduce a novel algorithm, VaSSO-SGDAM, by leveraging Variance-Suppressed Sharpness-aware Optimization (VaSSO) for deep AUC maximization. We provide a theoretical convergence analysis of this algorithm, marking it as the first work to achieve such significant theoretical outcomes for this kind of problem. Lastly, we implement our method for optimizing the AUC maximization problem, and the experimental findings validate the efficacy of our approach. Xinwen Zhang, Hongchang Gao

Federated Stochastic Bilevel Optimization with Fully First-Order GradientsabstractFederated stochastic bilevel optimization has been actively studied in recent years due to its widespread applications in machine learning. However, most existing federated stochastic bilevel optimization algorithms require the computation of second-order Hessian and Jacobian matrices, which leads to longer running times in practice. To address these challenges, we propose a novel federated stochastic variance-reduced bilevel gradient descent algorithm that relies solely on first-order oracles. Specifically, our approach does not require the computation of second-order Hessian and Jacobian matrices, significantly reducing running time. Furthermore, we introduce a novel learning rate mechanism, i.e., a constant single-time-scale learning rate, to coordinate the update of different variables. We also present a new strategy to establish the convergence rate of our algorithm. Finally, the extensive experimental results confirm the efficacy of our proposed algorithm. Rohit Dhaipule, Chiu C. | 2025 | Joint Swapping and Purification with Failures for Entanglement Distribution in Quantum NetworksabstractSwapping and purification are the two fundamental building blocks for multi-hop quantum networks. However, their interplay and its impact on end-to-end fidelity and cost are not yet fully explored. Existing scheduling algorithms address this problem under certain simplified assumptions and models that may not fully capture the complexities of real scenarios. In this work, we first consider more general assumptions that account for operation failures and extend a tree-based modeling approach for joint swapping and purification. Then, for the first time, we analytically prove the previous conjecture that the optimal strategy under Binary system is always to purify the entanglements before any swapping. This sheds light on the protocol and device design for entanglement distribution in quantum networks. We then further propose a tree-based algorithm, which can efficiently schedule swapping and purification along a path for both Binary and Werner systems. | 2025 | On the Convergence of Stochastic Smoothed Multi-Level Compositional Gradient Descent AscentabstractMulti-level compositional optimization is a fundamental framework in machine learning with broad applications. While recent advances have addressed compositional minimization problems, the stochastic multi-level compositional minimax problem introduces significant new challenges—most notably, the biased nature of stochastic gradients for both the primal and dual variables. In this work, we address this gap by proposing a novel stochastic multi-level compositional gradient descent-ascent algorithm, incorporating a smoothing technique under the nonconvex-PL condition. We establish a convergence rate to an $(\epsilon, \epsilon/\sqrt{\kappa})$-stationary point with improved dependence on the condition number at $O(\kappa^{3/2})$, where $\epsilon$ denotes the solution accuracy and $\kappa$ represents the condition number. Moreover, we design a novel stage-wise algorithm with variance reduction to address the biased gradient issue under the two-sided PL condition. This algorithm successfully enables a translation from and $(\epsilon, \epsilon/\sqrt{\kappa})$-stationary point to an $\epsilon$-stationary point. Finally, extensive experiments validate the effectiveness of our algorithms. Xinwen Zhang, Hongchang Gao

Discriminative Forests Improve Generative Diversity for Generative Adversarial NetworksabstractImproving the diversity of Artificial Intelligence Generated Content (AIGC) is one of the fundamental problems in the theory of generative models such as generative adversarial networks (GANs). Previous studies have demonstrated that the discriminator in GANs should have high capacity and robustness to achieve the diversity of generated data. However, a discriminator with high capacity tends to overfit and guide the generator toward collapsed equilibrium. In this study, we propose a novel discriminative forest GAN, named Forest-GAN, that replaces the discriminator to improve the capacity and robustness for modeling statistics in real-world data distribution. A discriminative forest is composed of multiple independent discriminators built on bootstrapped data. We prove that a discriminative forest has a generalization error bound, which is determined by the strength of individual discriminators and the correlations among them. Hence, a discriminative forest can provide very large capacity without any risk of overfitting, which subsequently improves the generative diversity. With the discriminative forest framework, we significantly improved the performance of AutoGAN with a new record FID of 19.27 from 30.71 on STL10 and improved the performance of StyleGAN2-ADA with a new record FID of 6.87 from 9.22 on LSUN-cat. | 2024 | Decentralized Multi-Level Compositional Optimization Algorithms with Level-Independent Convergence RateabstractStochastic multi-level compositional optimization problems cover many new machine learning paradigms, e.g., multi-step model-agnostic meta-learning, which require efficient optimization algorithms for large-scale data. This paper studies the decentralized stochastic multi-level optimization algorithm, which is challenging because the multi-level structure and decentralized communication scheme may make the number of levels significantly affect the order of the convergence rate. To this end, we develop two novel decentralized optimization algorithms to optimize the multi-level compositional optimization problem. Our theoretical results show that both algorithms can achieve the level-independent convergence rate for nonconvex problems under much milder conditions compared with existing single-machine algorithms. To the best of our knowledge, this is the first work that achieves the level-independent convergence rate under the decentralized setting. Moreover, extensive experiments confirm the efficacy of our proposed algorithms. Hongchang Gao

Achieving Fairness through Separability: A Unified Framework for Fair Representation LearningabstractFairness is a growing concern in machine learning as state-of-the-art models may amplify social prejudice by making biased predictions against specific demographics such as race and gender. Such discrimination raises issues in various fields such as employment, criminal justice, and trust score evaluation. To address the concerns, we propose learning fair representation through a straightforward yet effective approach to project intrinsic information while filtering sensitive information for downstream tasks. Our model consists of two goals: one is to ensure that the latent data from different demographic groups is non-separable (i.e., make the latent data distribution independent of the sensitive feature to improve fairness); the other is to maximize the separability of latent data from different classes (i.e., maintain the discriminative power of data for the sake of the downstream tasks like classification). Our method adopts a non-zero-sum adversarial game to minimize the distance between data from different demographic groups while maximizing the margin between data from different classes. Moreover, the proposed objective function can be easily generalized to multiple sensitive attributes and multi-class scenarios as it upper bounds popular fairness metrics in these cases. We provide theoretical analysis of the fairness of our model and validate w.r.t. both fairness and predictive performance on benchmark datasets. | 2024 | A Doubly Recursive Stochastic Compositional Gradient Descent Method for Federated Multi-Level Compositional OptimizationabstractFederated compositional optimization has been actively studied in the past few years. However, existing methods mainly focus on the two-level compositional optimization problem, which cannot be directly applied to the multi-level counterparts. Moreover, the convergence rate of existing federated two-level compositional optimization learning algorithms fails to achieve linear speedup with respect to the number of workers under heterogeneous settings. After identifying the reason for this failure, we developed a novel federated stochastic multi-level compositional optimization algorithm by introducing a novel Jacobian-vector product estimator. This innovation mitigates both the heterogeneity issue and the communication efficiency issue simultaneously. We then theoretically proved that our algorithm can achieve the level-independent and linear speedup convergence rate for nonconvex problems. To our knowledge, this is the first time that a federated learning algorithm can achieve such a favorable convergence rate for multi-level compositional problems. Moreover, experimental results confirm the efficacy of our algorithm. Hongchang Gao

A Federated Stochastic Multi-level Compositional Minimax Algorithm for Deep AUC MaximizationabstractAUC maximization is an effective approach to address the imbalanced data classification problem in federated learning. In the past few years, a couple of federated AUC maximization approaches have been developed based on the minimax optimization. However, directly solving a minimax optimization problem to maximize the AUC score cannot achieve satisfactory performance. To address this issue, we propose to maximize AUC via optimizing a federated multi-level compositional minimax problem. Specifically, we develop a novel federated multi-level compositional minimax algorithm with rigorous theoretical guarantees to solve this new learning paradigm in both algorithmic design and theoretical analysis. To the best of our knowledge, this is the first work studying the multi-level minimax optimization problem. Additionally, extensive empirical evaluations confirm the efficacy of our proposed approach. Xinwen Zhang, Ali Payani, Myungjin Lee, Richard Souvenir, Hongchang Gao

Decentralized Stochastic Compositional Gradient Descent for AUPRC MaximizationabstractIn this paper, we consider the large-scale Area Under the Precision-Recall Curve (AUPRC) maximization problem for the imbalanced data classification task. Existing optimization methods for AUPRC maximization only focus on the single-machine setting, which are not applicable to the distributed data. To address this problem, we propose a novel decentralized stochastic compositional gradient descent method for large-scale AUPRC maximization. Our theoretical analysis shows that it can achieve a better sample complexity 𝒪 (1/ϵ4) than 𝒪 (1/ϵ6) of existing decentralized methods, but has the same communication complexity 𝒪 (1/ϵ4). To further reduce the communication cost, we developed a novel communication-efficient decentralized stochastic compositional gradient descent method, whose communication complexity is improved to 𝒪 (1/ϵ4–4α) (where α ∈ (0,1/4)). To the best of our knowledge, this is the first work achieving such favorable sample and communication complexities. Finally, we conduct extensive experiments for imbalanced data classification and the empirical results confirm the superior performance of our proposed methods. | 2024 | Group Formation and Sampling in Group-Based Hierarchical Federated LearningabstractHierarchical federated learning has emerged as a pragmatic approach to addressing scalability, robustness, and privacy concerns within distributed machine learning, particularly in the context of edge computing. This hierarchical method involves grouping clients at the edge, where the constitution of client groups significantly impacts overall learning performance, influenced by both the benefits obtained and costs incurred during group operations (such as group formation and group training). This is especially true for edge and mobile devices, which are more sensitive to computation and communication overheads. The formation of groups is critical for group-based hierarchical federated learning but often neglected by researchers, especially in the realm of edge systems. In this paper, we present a comprehensive exploration of a group-based federated edge learning framework utilizing the hierarchical cloud-edge-client architecture and employing probabilistic group sampling. Our theoretical analysis of its convergence rate, considering the characteristics of client groups, reveals the pivotal role played by group heterogeneity in achieving convergence. Building on this insight, we introduce new methods for group formation and group sampling, aiming to mitigate data heterogeneity within groups and enhance the convergence and overall performance of federated learning. Our proposed methods are validated through extensive experiments, demonstrating their superiority over current algorithms in terms of prediction accuracy and training cost. | 2023 | Distributed Stochastic Nested Optimization for Emerging Machine Learning Models: Algorithm and TheoryabstractTraditional machine learning models can be formulated as the expected risk minimization (ERM) problem: minw∈Rd Eξ [l(w; ξ)], where w ∈ Rd denotes the model parameter, ξ represents training samples, l(·) is the loss function. Numerous optimization algorithms, such as stochastic gradient descent (SGD), have been developed to solve the ERM problem. However, a wide range of emerging machine learning models are beyond this class of optimization problems, such as model-agnostic meta-learning (Finn, Abbeel, and Levine 2017). Of particular interest of my research is the stochastic nested optimization (SNO) problem, whose objective function has a nested structure. Specifically, I have been focusing on two instances of this kind of problem: stochastic compositional optimization (SCO) problems, which cover meta-learning, area-under-the-precision recall-curve optimization, contrastive self-supervised learning, etc., and stochastic bilevel optimization (SBO) problems, which can be applied to meta-learning, hyperparameter optimization, neural network architecture search, etc. With the emergence of large-scale distributed data, such as the user data generated on mobile devices or intelligent hardware, it is imperative to develop distributed optimization algorithms for SNO (Distributed SNO). A significant challenge for optimizing distributed SNO problems lies in that the stochastic (hyper-)gradient is a biased estimation of the full gradient. Thus, existing distributed optimization algorithms when applied to them suffer from slow convergence rates. In this talk, I will discuss my recent works about distributed SCO (Gao and Huang 2021; Gao, Li, and Huang 2022) and distributed SBO (Gao, Gu, and Thai 2022; Gao 2022) under both centralized and decentralized settings, including algorithmic details about reducing the bias of stochastic gradient, theoretical convergence rate, and practical machine learning applications, and then highlight challenges for future research. | 2023 | On the Convergence of Distributed Stochastic Bilevel Optimization Algorithms over a NetworkabstractBilevel optimization has been applied to a wide variety of machine learning models and numerous stochastic bilevel optimization algorithms have been developed in recent years. However, most existing algorithms restrict their focus on the single-machine setting so that they are incapable of handling the distributed data. To address this issue, under the setting where all participants compose a network and perform peer-to-peer communication in this network, we developed two novel decentralized stochastic bilevel optimization algorithms based on the gradient tracking communication mechanism and two different gradient estimators. Additionally, we established their convergence rates for nonconvex-strongly-convex problems with novel theoretical analysis strategies. To our knowledge, this is the first work achieving these theoretical results. Finally, we applied our algorithms to practical machine learning models, and the experimental results confirmed the efficacy of our algorithms. Hongchang Gao, Bin Gu 0001, My T. Thai

Set-level Guidance Attack: Boosting Adversarial Transferability of Vision-Language Pre-training ModelsabstractVision-language pre-training (VLP) models have shown vulnerability to adversarial examples in multimodal tasks. Furthermore, malicious adversaries can be deliberately transferred to attack other black-box models. However, existing work has mainly focused on investigating white-box attacks. In this paper, we present the first study to investigate the adversarial transferability of recent VLP models. We observe that existing methods exhibit much lower transferability, compared to the strong attack performance in white-box settings. The transferability degradation is partly caused by the under-utilization of cross-modal interactions. Particularly, unlike unimodal learning, VLP models rely heavily on cross-modal interactions and the multimodal alignments are many-to-many, e.g., an image can be described in various natural languages. To this end, we propose a highly transferable Set-level Guidance Attack (SGA) that thoroughly leverages modality interactions and incorporates alignment-preserving augmentation with cross-modal guidance. Experimental results demonstrate that SGA could generate adversarial examples that can strongly transfer across different VLP models on multiple downstream vision-language tasks. On image-text retrieval, SGA significantly enhances the attack success rate for transfer attacks from ALBEF to TCL by a large margin (at least 9.78% and up to 30.21%), compared to the state-of-the-art. | 2023 | Group-based Hierarchical Federated Learning: Convergence, Group Formation, and SamplingabstractHierarchical federated learning has been studied as a more practical approach to federated learning in terms of scalability, robustness, and privacy protection, particularly in edge computing. To achieve these advantages, operations are typically conducted in a grouped manner at the edge, which means that the formation of client groups can affect the learning performance, such as the benefits gained and costs incurred by group operations. This is especially true for edge and mobile devices, which are more sensitive to computation and communication overheads. The formation of groups is critical for group-based federated edge learning but has not been studied in detail, and even been overlooked by researchers. In this paper, we consider a group-based federated edge learning framework that leverages the hierarchical cloud-edge-client architecture and probabilistic group sampling. We first theoretically analyze the convergence rate with respect to the characteristics of the client groups, and find that group heterogeneity plays an important role in the convergence. Then, on the basis of this key observation, we propose new group formation and group sampling methods to reduce data heterogeneity within groups and to boost the convergence and performance of federated learning. Finally, our extensive experiments show that our methods outperform current algorithms in terms of prediction accuracy and training cost. | 2023 | Communication-Efficient Stochastic Gradient Descent Ascent with Momentum AlgorithmsabstractNumerous machine learning models can be formulated as a stochastic minimax optimization problem, such as imbalanced data classification with AUC maximization. Developing efficient algorithms to optimize such kinds of problems is of importance and necessity. However, most existing algorithms restrict their focus on the single-machine setting so that they are incapable of dealing with the large communication overhead in a distributed training system. Moreover, most existing communication-efficient optimization algorithms only focus on the traditional minimization problem, failing to handle the minimax optimization problem. To address these challenging issues, in this paper, we develop two novel communication-efficient stochastic gradient descent ascent with momentum algorithms for the distributed minimax optimization problem, which can significantly reduce the communication cost via the two-way compression scheme. However, the compressed momentum makes it considerably challenging to investigate the convergence rate of our algorithms, especially in the presence of the interaction between the minimization and maximization subproblems. In this paper, we successfully addressed these challenges and established the convergence rate of our algorithms for nonconvex-strongly-concave problems. To the best of our knowledge, our algorithms are the first communication-efficient algorithm with theoretical guarantees for the minimax optimization problem. Finally, we apply our algorithm to the distributed AUC maximization problem for the imbalanced data classification task. | 2023 | Distributed Optimization for Big Data Analytics: Beyond MinimizationabstractThe traditional machine learning model can be formulated as an empirical risk minimization problem, which is typically optimized via stochastic gradient descent (SGD). With the emergence of big data, distributed optimization, e.g., distributed SGD, has been attracting increasing attention to facilitate machine learning models for big data analytics. However, existing distributed optimization mainly focuses on the standard empirical risk minimization problem, failing to deal with the emerging machine learning models that are beyond that category. Thus, of particular interest of this tutorial includes the stochastic minimax optimization, stochastic bilevel optimization, and stochastic compositional optimization, which covers a wide range of emerging machine learning models, e.g., model-agnostic meta-learning models, adversarially robust machine learning models, imbalanced data classification models, etc. Since these models have been widely used in big data analytics, it is necessary to provide a comprehensive introduction about the new distributed optimization algorithms designed for these models. Therefore, the goal of this tutorial is to present the state-of-the-art and recent advances in distributed minimax optimization, distributed bilevel optimization, and distributed compositional optimization. In particular, we will introduce the typical applications in each category and discuss the corresponding distributed optimization algorithms in both centralized and decentralized settings. Through this tutorial, the researchers will be exposed to the fundamental algorithmic design and basic convergence theories, and the practitioners will be able to benefit from this tutorial to apply these algorithms to real-world data mining applications. | 2023 | Federated Compositional Deep AUC MaximizationabstractFederated learning has attracted increasing attention due to the promise of balancing privacy and large-scale learning; numerous approaches have been proposed. However, most existing approaches focus on problems with balanced data, and prediction performance is far from satisfactory for many real-world applications where the number of samples in different classes is highly imbalanced. To address this challenging problem, we developed a novel federated learning method for imbalanced data by directly optimizing the area under curve (AUC) score. In particular, we formulate the AUC maximization problem as a federated compositional minimax optimization problem, develop a local stochastic compositional gradient descent ascent with momentum algorithm, and provide bounds on the computational and communication complexities of our algorithm. However, the federated stochastic compositional optimization problem is still underexplored, even though it has widespread applications in machine learning. In this paper, we developed a novel local stochastic compositional gradient descent with momentum method, which facilitates Federated Learning for the stochastic compositional problem. Importantly, we investigated the convergence rate of our proposed method and proved that it can achieve the $O(1/\epsilon^4)$ sample complexity, which is better than existing methods. Meanwhile, our communication complexity $O(1/\epsilon^3)$ can match existing methods. | 2022 | Gradient-Free Method for Heavily Constrained Nonconvex OptimizationabstractZeroth-order (ZO) method has been shown to be a powerful method for solving the optimization problem where explicit expression of the gradients is difficult or infeasible to obtain. Recently, due to the practical value of the constrained problems, a lot of ZO Frank-Wolfe or projected ZO methods have been proposed. However, in many applications, we may have a very large number of nonconvex white/black-box constraints, which makes the existing zeroth-order methods extremely inefficient (or even not working) since they need to inquire function value of all the constraints and project the solution to the complicated feasible set. In this paper, to solve the nonconvex problem with a large number of white/black-box constraints, we proposed a doubly stochastic zeroth-order gradient method (DSZOG) with momentum method and adaptive step size. Theoretically, we prove DSZOG can converge to the $\epsilon$-stationary point of the constrained problem. Experimental results in two applications demonstrate the superiority of our method in terms of training time and accuracy compared with other ZO methods for the constrained problem. | 2022 | Robust Self-Supervised Structural Graph Neural Network for Social Network PredictionabstractThe self-supervised graph representation learning has achieved much success in recent web based research and applications, such as recommendation system, social networks, and anomaly detection. However, existing works suffer from two problems. Firstly, in social networks, the influential neighbors are important, but the overwhelming routine in graph representation-learning utilizes the node-wise similarity metric defined on embedding vectors that cannot exactly capture the subtle local structure and the network proximity. Secondly, existing works implicitly assume a universal distribution across datasets, which presumably leads to sub-optimal models considering the potential distribution shift. To address these problems, in this paper, we learn structural embeddings in which the proximity is characterized by 1-Wasserstein distance. We propose a distributionally robust self-supervised graph neural network framework to learn the representations. More specifically, in our method, the embeddings are computed based on subgraphs centering at the node of interest and represent both the node of interest and its neighbors, which better preserves the local structure of nodes. To make our model end-to-end trainable, we adopt a deep implicit layer to compute the Wasserstein distance, which can be formulated as a differentiable convex optimization problem. Meanwhile, our distributionally robust formulation explicitly constrains the maximal diversity for matched queries and keys. As such, our model is insensitive to the data distributions and has better generalization abilities. Extensive experiments demonstrate that the graph encoder learned by our approach can be utilized for various downstream analyses, including node classification, graph classification, and top-k similarity search. The results show our algorithm outperforms state-of-the-art baselines, and the ablation study validates the effectiveness of our design. Yanfu Zhang, Hongchang Gao, Jian Pei 0001, Heng Huang 0001

On the Convergence of Communication-Efficient Local SGD for Federated LearningabstractFederated Learning (FL) has attracted increasing attention in recent years. A leading training algorithm in FL is local SGD, which updates the model parameter on each worker and averages model parameters across different workers only once in a while. Although it has fewer communication rounds than the classical parallel SGD, local SGD still has large communication overhead in each communication round for large machine learning models, such as deep neural networks. To address this issue, we propose a new communication-efficient distributed SGD method, which can significantly reduce the communication cost by the error-compensated double compression mechanism. Under the non-convex setting, our theoretical results show that our approach has better communication complexity than existing methods and enjoys the same linear speedup regarding the number of workers as the full-precision local SGD. Moreover, we propose a communication-efficient distributed SGD with momentum, which also has better communication complexity than existing methods and enjoys a linear speedup with respect to the number of workers. At last, extensive experiments are conducted to verify the performance of our proposed two methods. | 2021 | Sample Efficient Decentralized Stochastic Frank-Wolfe Methods for Continuous DR-Submodular MaximizationabstractContinuous DR-submodular maximization is an important machine learning problem, which covers numerous popular applications. | 2021 | PAR-GAN: Improving the Generalization of Generative Adversarial Networks Against Membership Inference AttacksabstractRecent works have shown that Generative Adversarial Networks (GANs) may generalize poorly and thus are vulnerable to privacy attacks. In this paper, we seek to improve the generalization of GANs from a perspective of privacy protection, specifically in terms of defending against the membership inference attack (MIA) which aims to infer whether a particular sample was used for model training. We design a GAN framework, partition GAN (PAR-GAN), which consists of one generator and multiple discriminators trained over disjoint partitions of the training data. The key idea of PAR-GAN is to reduce the generalization gap by approximating a mixture distribution of all partitions of the training data. Our theoretical analysis shows that PAR-GAN can achieve global optimality just like the original GAN. Our experimental results on simulated data and multiple popular datasets demonstrate that PAR-GAN can improve the generalization of GANs while mitigating information leakage induced by MIA. | 2020 | Can Stochastic Zeroth-Order Frank-Wolfe Method Converge Faster for Non-Convex Problems?abstractFrank-Wolfe algorithm is an efficient method for optimizing non-convex constrained problems. However, most of existing methods focus on the first-order case. In real-world applications, the gradient is not always available. To address the problem of lacking gradient in many applications, we propose two new stochastic zeroth-order Frank-Wolfe algorithms and theoretically proved that they have a faster convergence rate than existing methods for non-convex problems. Specifically, the function queries oracle of the proposed faster zeroth-order Frank-Wolfe (FZFW) method is $O(\frac{n^{1/2}d}{\epsilon^2})$ which can match the iteration complexity of the first-order counterpart approximately. As for the proposed faster zeroth-order conditional gradient sliding (FZCGS) method, its function queries oracle is improved to $O(\frac{n^{1/2}d}{\epsilon})$, indicating that its iteration complexity is even better than that of its first-order counterpart NCGS-VR. In other words, the iteration complelxity of the accelerated first-order Frank-Wolfe method NCGS-VR is suboptimal. Then, we proposed a new algorithm to improve its IFO (incremental first-order oracle) to $O(\frac{n^{1/2}}{\epsilon})$. | 2020 | Robust Cumulative Crowdsourcing Framework Using New Incentive Payment Function and Joint Aggregation ModelabstractIn recent years, crowdsourcing has gained tremendous attention in the machine learning community due to the increasing demand for labeled data. However, the labels collected by crowdsourcing are usually unreliable and noisy. This issue is mainly caused by: 1) nonflexible data collection mechanisms; 2) nonincentive payment functions; and 3) inexpert crowd workers. We propose a new robust crowdsourcing framework as a comprehensive solution for all these challenging problems. Our unified framework consists of three novel components. First, we introduce a new flexible data collection mechanism based on the cumulative voting system, allowing crowd workers to express their confidence for each option in multi-choice questions. Second, we design a novel payment function regarding the settings of our data collection mechanism. The payment function is theoretically proved to be incentive-compatible, encouraging crowd workers to disclose truthfully their beliefs to get the maximum payment. Third, we propose efficient aggregation models, which are compatible with both single-option and multi-option crowd labels. We define a new aggregation model, called simplex constrained majority voting (SCMV), and enhance it by using the probabilistic generative model. Furthermore, fast optimization algorithms are derived for the proposed aggregation models. Experimental results indicate higher quality for the crowd labels collected by our proposed mechanism without increasing the cost. Our aggregation models also outperform the state-of-the-art models on multiple crowdsourcing data sets in terms of accuracy and convergence speed. | 2019 | Conditional Random Field Enhanced Graph Convolutional Neural Networksabstractattention in recent years. Thus, it is important to preserve this kind of similarity information in the hidden layers of graph convolutional neural networks. However, existing works fail to do that. On the other hand, it is challenging to enforce the hidden layers to preserve the similarity relationship. To address this issue, we propose a novel CRF layer for graph convolutional neural networks to encourage similar nodes to have similar hidden features. In this way, the similarity information can be preserved explicitly. In addition, the proposed CRF layer is easy to compute and optimize. | 2019 | ProGAN: Network Embedding via Proximity Generative Adversarial NetworkabstractNetwork embedding has attracted increasing attention in recent few years, which is to learn a low-dimensional representation for each node of a network to benefit downstream tasks, such as node classification, link prediction, and network visualization. Essentially, the task of network embedding can be decoupled into discovering the proximity in the original space and preserving it in the low dimensional space. Only with the well-discovered proximity can we preserve it in the low-dimensional space. Thus, it is critical to discover the proximity between different nodes to learn good node representations. To address this problem, in this paper, we propose a novel proximity generative adversarial network (ProGAN) which can generate proximities. As a result, the generated proximity can help to discover the complicated underlying proximity to benefit network embedding. To generate proximities, we design a novel neural network architecture to fulfill it. In particular, the generation of proximities is instantiated to the generation of triplets of nodes, which encodes the similarity relationship between different nodes. | 2019 | Stacked Robust Adaptively Regularized Auto-Regressions for Domain AdaptationabstractDomain adaptation is the situation for supervised learning in which the training data are sampled from the source domain while the test data are sampled from the target domain that follows a different distribution. The key to solving such a problem is to reduce effects of the discrepancy between the training data and test data. Recently, deep learning methods that employ stacked denoising auto-encoders (SDAs) to learn new representations for both domains have been successfully applied in domain adaptation. And, remarkable performance on multi-domain sentiment analysis datasets has been reported, making deep learning a promising approach to domain adaptation problems. In this paper, a deep learning method called Stacked Robust Adaptively Regularized Auto-regressions (SRARAs) is proposed to learn useful representations for domain adaptation problems. Each layer of SRARAs contains two steps: a linear transformation step, which is based on robust adaptively regularized auto-regression, and a non-linear squashing transformation step. The first step aims at reducing the discrepancy between the training data and test data, and the second step is to introduce non-linearity and control the range of the elements in the outputs. | 2018 | Stochastic Second-Order Method for Large-Scale Nonconvex Sparse Learning ModelsabstractSparse learning models have shown promising performance in the high dimensional machine learning applications. | 2018 | Self-Paced Network EmbeddingabstractNetwork embedding has attracted increasing attention in recent data mining research with many real-world applications. Network embedding is to learn low-dimensional representations for nodes in a network. A popular kind of existing methods, such as DeepWalk, Node2Vec, and LINE, learn node representations by pushing positive context node to the anchor node while pushing negative context nodes away from it in the low-dimensional vector space. When sampling the negative context nodes, they usually employ a predefined sampling distribution based on the node popularity. However, this sampling distribution often fails to capture the real informativeness of each node and cannot reflect the training state. To address these important problems, in this paper, we propose a novel self-paced network embedding method. Specifically, our method can adaptively capture the informativeness of each node based on the current training state, and sample negative context nodes in terms of their informativeness. The proposed self-paced sampling strategy can gradually select difficult negative context nodes with training process going on to learn better node representations. Moreover, to better capture the node informativeness for learning node representations, we extend our method to the generative adversarial network framework, which has the larger capacity to discover node informativeness. The extensive experiments have been conducted on the benchmark network datasets to validate the effectiveness of our proposed methods. Hongchang Gao, Heng Huang 0001

| 2018 | Attention Convolutional Neural Network for Advertiser-level Click-through Rate ForecastingabstractClick-through rate (CTR) is a critical problem in online advertising. Most existing researches only focus on the user-level CTR prediction. However, advertiser-level CTR forecasting also plays a very important role because advertisers typically decide how much they would like to bid for advertisements to achieve the maximum clicks given their budget based on CTR forecasting. Over-forecasting will make the advertiser to pay more than necessary but get less return on investment (ROI). Under-forecasting will make the advertiser to spend less money on campaigns but they cannot achieve the desired ROI goals. In this paper, we focus on the advertiser-level CTR forecasting and formulate it as a time series forecasting problem based on the historical CTR record. This is a very challenging problem due to the heavy fluctuation and highly non-linearity of time series. Furthermore, advertisers usually provide useful contextual information for their campaigns, such as text descriptions, targeting locations and devices, which has high correlation with CTR but has not yet been used for CTR forecasting. Thus, we propose a novel context-aware attention convolutional neural network (CACNN), which can capture the high non-linearity and local information of the time series, as well as the underlying correlation between the time series of CTR and the contextual information. To the best of our knowledge, this is the first work employing convolutional neural network and incorporating heterogeneous information to perform CTR forecasting at advertiser level. We implement the system on Yahoo TensorFlowOnSpark platform which enables distributed deep learning on a cluster of GPU and CPU servers, and achieves faster learning speed and data access on HDFS when available. Instead of using single centroid for each cluster, we introduce multiple local centroids for individual cluster such that the manifold structure can be captured by the local centroids. Such a novel NMF method can improve the clustering performance effectively. Furthermore, a novel bipartite graph is incorporated to obtain the clustering indicator directly without any post process. | 2016 | New Robust Clustering Model for Identifying Cancer Genome LandscapesabstractIn recent decades, the availability of comprehensive genomic data has facilitated the insight of molecular portraits of cancer. Specifically, by conducting cancer clustering, cancer samples can be divided into several groups according to their differences and similarities in molecular characteristics.
