2026 Key Decision-Makers in Multi-Agent Debates: Who Holds the Power?
abstract
Recent studies on LLM agent scaling have highlighted the potential of Multi-Agent Debate (MAD) to enhance reasoning abilities. However, the critical aspect of role allocation strategies remains underexplored. In this study, we demonstrate that allocating roles with differing viewpoints to specific positions significantly impacts MAD's performance in reasoning tasks. Specifically, we find a novel role allocation strategy, "Truth Last", which can improve MAD performance by up to 22% in reasoning tasks. To address the issue of unknown truth in practical applications, we propose the Multi-Agent Debate Consistency (MADC) strategy, which systematically simulates and optimizes its core mechanisms. MADC incorporates path consistency to assess agreement among independent roles, simulating the role with the highest consistency score as the truth. We validated MADC across a range of LLMs (9 models), including the DeepSeek-R1 Distilled Models, on challenging reasoning tasks. MADC consistently demonstrated advanced performance, effectively overcoming MAD's performance bottlenecks and providing a crucial pathway for further improvements in LLM agent scaling.

2026 Reason2Attack: Jailbreaking Text-to-Image Models via LLM Reasoning
abstract
Text-to-Image (T2I) models typically deploy safety mechanisms to prevent the generation of sensitive images. Unfortunately, recent jailbreaking attack methods manually design instructions for the LLM to generate adversarial prompts, which effectively exposing safety vulnerabilities of T2I models. However, existing methods have two limitations: 1) relying on manually exhaustive strategies for designing adversarial prompts, lacking a unified framework, and 2) requiring numerous queries to achieve a successful attack, limiting their practical applicability. To address this issue, we propose Reason2Attack~(R2A), which aims to enhance the effectiveness and efficiency of the LLM in jailbreaking attacks. Specifically, we first use Frame Semantics theory to systematize existing manually crafted strategies and propose a unified generation framework to generate CoT adversarial prompts step by step. Following this, we propose a two-stage LLM reasoning training framework guided by the attack process. In the first stage, the LLM is fine-tuned with CoT examples generated by the unified generation framework to internalize the adversarial prompt generation process grounded in Frame Semantics. In the second stage, we incorporate the jailbreaking task into the LLM's reinforcement learning process, guided by the proposed attack process reward function that balances prompt stealthiness, effectiveness, and length, enabling the LLM to understand T2I models and safety mechanisms. Extensive experiments on various T2I models with safety mechanisms, and commercial T2I models, show the superiority and practicality of R2A.

2026 T2I-RiskyPrompt: A Benchmark for Safety Evaluation, Attack, and Defense on Text-to-Image Model
abstract
Using risky text prompts, such as pornography and violent prompts, to test the safety of text-to-image (T2I) models is a critical task. However, existing risky prompt datasets are limited in three key areas: 1) limited risky categories, 2) coarse-grained annotation, and 3) low effectiveness. To address these limitations, we introduce T2I-RiskyPrompt, a comprehensive benchmark designed for evaluating safety-related tasks in T2I models. Specifically, we first develop a hierarchical risk taxonomy, which consists of 6 primary categories and 14 fine-grained subcategories. Building upon this taxonomy, we construct a pipeline to collect and annotate risky prompts. Finally, we obtain 6,432 effective risky prompts, where each prompt is annotated with both hierarchical category labels and detailed risk reasons. Moreover, to facilitate the evaluation, we propose a reason-driven risky image detection method that explicitly aligns the MLLM with safety annotations. Based on T2I-RiskyPrompt, we conduct a comprehensive evaluation of eight T2I models, nine defense methods, five safety filters, and five attack strategies, offering nine key insights into the strengths and limitations of T2I model safety. Finally, we discuss potential applications of T2I-RiskyPrompt across various research fields.

2026 Pattern-aware Illicit Account Detection based on User Behavior Sequences
abstract
Illicit activities such as financial fraud and fake promotions are increasingly prevalent on social applications. The diverse behavioral structures of different types of illicit accounts pose difficulties in designing unified detection strategies. Unlike existing studies that focus on binary detection and often rely on user static profiles, we introduce a novel task: illicit account detection based solely on user behavior sequences. This task presents two key challenges: 1) illicit accounts often mimic benign users by performing normal-looking behavior subsequences, and 2) behaviors with the same action (e.g., add-friend, initiate-transaction) can serve different purposes, such as illicit or benign. To address these challenges, we propose a Pattern-aware Illicit Accounts Detection (PIAD) framework that consists of three components: 1) a dual-perspective pattern mining module that extracts category-specific self- and interaction-behavior patterns from behavior sequences to capture distinct behavioral regularities across different user types; 2) a contextualized action semantic encoding algorithm that aligns action codings with contextual dependencies among behaviors within user sequences to capture variations in purposes when behaviors with the same actions occur under different contexts; and 3) a pattern-aware fusion model that integrates the mined patterns with the context and interaction in behavior sequences to learn discriminative representations for detection. Extensive experiments on real-world datasets demonstrate that PIAD consistently outperforms state-of-the-art baselines with an average 7.51% improvement on F1 score.

2026 Node Injection-Based Adversarial Attack and Defense on Social Bot Detection
abstract
Social platforms such as Twitter are increasingly threatened by automated social bots, which can manipulate public opinion, spread misinformation, and compromise platform integrity. To detect such accounts, various methods have been proposed, with many recent approaches leveraging graph neural networks (GNNs) due to their ability to model relational structures among users. However, these models may be vulnerable to adversarial perturbations that exploit their structural dependencies. To investigate this vulnerability, we propose a targeted black-box node injection attack that deceives detection models by injecting a new bot near a target bot, causing both to evade detection. This attack is specifically designed to exploit GNN-based model behaviors and does not require any access to model parameters or architecture. Given the success of this attack in exposing structural weaknesses, it is essential to develop effective defenses to improve the robustness of detection models. To this end, we introduce a cost-efficient adversarial training method with reweighted supervision, which selectively emphasizes adversarial samples during learning. This approach improves model robustness without increasing computational cost or requiring additional data. The effectiveness of our attack and defense methods is demonstrated through experiential evaluations conducted on six different models. Specifically, we achieve a maximum attack success rate (ASR) of 95.74% and robustness improvement of 95.74% in Cresci-2015 and achieve a maximum ASR of 97.15% and robustness improvement of 56.20% in TwiBot-22. The detection performance of the models fluctuates less than 2% after adversarial training.

2026 Medical VLP Model Is Vulnerable: Toward Multimodal Adversarial Attack on Large Medical Vision-Language Models
abstract
Medical Visual Question Answering (Medical VQA) is an essential task that facilitates the automated interpretation of complex clinical imagery with corresponding textual questions, thereby supporting both clinicians and patients in making informed medical decisions. With the rapid progress of Vision-Language Pretraining (VLP) in general domains, the development of medical VLP models has emerged as a rapidly growing interdisciplinary area at the intersection of artificial intelligence (AI) and healthcare. However, few works have been proposed to evaluate the adversarial robustness of medical VLP models, which faces two primary challenges: (1) the complexity of medical texts, stemming from the presence of terminologies, poses significant challenges for models in comprehending the text for adversarial attack; (2) the diversity of medical images arises from the variety of anatomical regions depicted, which requires models to determine critical anatomical regions for attack. In this paper, we propose a novel multimodal adversarial attack generator for evaluating the robustness of medical VLP models. Specifically, for the complexity of medical texts, we integrate medical knowledge when crafting text adversarial samples, which can facilitate the terminologies understanding and adversarial strength; for the diversity of medical images, we divide the anatomical regions into either global or local regions in medical images, which are determined by learned balance weights for perturbations. Our experimental study not only provides a quantitative understanding in medical VLP models, but also underscores the critical need for thorough safety evaluations before implementing them in real-world medical applications.

2026 Next Chain Prediction: A Generative Recommendation Model With Sequence-Chain Attention
abstract
Sequential recommendation is a classic task in the field of recommendation, which aims to predict the next user-preferred item based on their historical interactions. However, in practical scenarios, users' needs are dynamically evolving in a short period and exhibit a chain-like structure. Consequently, recommending only the next single item does not fully meet user demands and limits the potential for increasing business traffic on platforms. To overcome this limitation, we propose a new recommendation paradigm, Next Chain Prediction, which requires the model to predict a chain of items. Due to the advantages of generative recommendation models on user preference representation and scalability, we design a generative recommendation model for next chain prediction. The generative model extracts long-term interests and short-term demands within a unified framework. By designing a Sequence-Chain Attention mechanism, the model performs self-attention learning across dual dimensions. Additionally, we design a generative loss function to balance the hit rate and diversity of the recommended items in the chain. We conduct experiments across three datasets and the experimental results show that our method achieves at least 1.22% improvement in HR@10 across three datasets for recommending multi-item chains. Furthermore, our method improves the diversity of recommended items and also offers the flexibility to adjust the size of predicted chains, maintaining state-of-the-art performance even when limited to predicting a single item.

2025 Anywhere: A Multi-Agent Framework for User-Guided, Reliable, and Diverse Foreground-Conditioned Image Generation
abstract
Recent advancements in image-conditioned image generation have demonstrated substantial progress. However, foreground-conditioned image generation remains underexplored, encountering challenges such as compromised object integrity, foreground-background inconsistencies, limited diversity, and reduced control flexibility. These challenges arise from current end-to-end inpainting models, which suffer from inaccurate training masks, limited foreground semantic understanding, data distribution biases, and inherent interference between visual and textual prompts. To overcome these limitations, we present Anywhere, a multi-agent framework that departs from the traditional end-to-end approach. In this framework, each agent is specialized in a distinct aspect, such as foreground understanding, diversity enhancement, object integrity protection, and textual prompt consistency. Our framework is further enhanced with the ability to incorporate optional user textual inputs, perform automated quality assessments, and initiate re-generation as needed. Comprehensive experiments demonstrate that this modular design effectively overcomes the limitations of existing end-to-end models, resulting in higher fidelity, quality, diversity and controllability in foreground-conditioned image generation. Additionally, the Anywhere framework is extensible, allowing it to benefit from future advancements in each individual agent.

2025 Aesthetic Perception Prompting for Interpretable Image Aesthetics Assessment with MLLMs
abstract
Image Aesthetic Assessment (IAA) aims to rate the aesthetic quality of images and has many practical applications. However, existing methods typically rely on limited annotated data for training, leading to two key issues: 1) score-only predictions lack interpretability, making it hard for users to understand the reasoning behind ratings; 2) the assessment ability learned through supervised training struggles to generalize to scenarios beyond the training data. To address these challenges, we leverage Multi-Modal Large Language Models (MLLMs) for interpretable image aesthetic assessment. Drawing inspiration from the human aesthetic perception process, we propose two key components: aesthetic attribute assessment (AAA) and scene-aware in-context learning (ICL). AAA is to provide detailed attribute-based analysis by prompting with evaluation criteria. Meanwhile, scene-aware ICL is to improve the model’s understanding of the aesthetic scoring principles across different scenes with given corresponding references. The output of these two components is used to guide the model to provide ratings and interpretations for more reliable and understandable results. Experiments across multiple datasets show the effectiveness of our framework in enhancing MLLM’s aesthetic perception ability and underscore its potential for interpretable IAA.

2025 RoCo-Sim: Enhancing Roadside Collaborative Perception through Foreground Simulation
abstract
Roadside Collaborative Perception refers to a system where multiple roadside units collaborate to pool their perceptual data, assisting vehicles in enhancing their environmental awareness. Existing roadside perception methods concentrate on model design but overlook data issues like calibration errors, sparse information, and multi-view consistency, leading to poor performance on recent published datasets. To significantly enhance roadside collaborative perception and address critical data issues, we present the first simulation framework RoCo-Sim for road-side collaborative perception. RoCo-Sim is capable of generating diverse, multi-view consistent simulated roadside data through dynamic foreground editing and full-scene style transfer of a single image. RoCo-Sim consists of four components: (1) Camera Extrinsic Optimization ensures accurate 3D to 2D projection for roadside cameras; (2) A novel Multi-View Occlusion-Aware Sampler (MOAS) determines the placement of diverse digital assets within 3D space; (3) DepthSAM innovatively models foreground-background relationships from single-frame fixed-view images, ensuring multi-view consistency of foreground; and (4) Scalable Post-Processing Toolkit generates more realistic and enriched scenes through style transfer and other enhancements. RoCo-Sim significantly improves roadside 3D object detection, outperforming SOTA methods by 83.74 on Rcooper-Intersection and 83.12 on TUMTraf-V2X for AP70. RoCo-Sim fills a critical gap in roadside perception simulation. Code and pre-trained models will be released soon: https://github.com/duyuwen-duen/RoCo-Sim

2025 DataMorpher: Automatic Data Transformation Using LLM-Based Zero-Shot Code Generation
abstract
Data transformation is a critical challenge in modern data management systems, particularly when handling complex operations over multiple data sources. However, existing approaches rely on supervised learning, which requires tremendous data labeling and training overhead. To alleviate such overhead while improving accuracy, we demonstrate a novel system DataMorpher that leverages Large Language Models (LLMs) to generate code that transforms source datasets into a user-specified target format. To generate a high-quality and token-efficient prompt, we leverage data profiling to extract features from the source datasets and historical examples of the target data. We also select a subset of features to reduce noise and costs using a ranking algorithm. These selected features are finally translated into a declarative language, which is inspired by SQL's data definition language (DDL), before being added to the prompt. We will demonstrate the workflow and effectiveness of DATAMORPHER using real-world data transformation workflows from Microsoft's GitHub benchmark, smart building, and medical data integration. 2025 Culture-based Adversarial Attack on Text-to-Image Models
abstract
Text-to-image (T2I) models aim to output high-quality images based on the input prompt. It commonly incorporates safety filters to prevent the generation of sensitive images. In this study, we aim to reveal the safety vulnerabilities of black-box T2I models in a real-world scenario. To address the challenges of bypassing filters and mitigating the trade-off between stealthiness and effectiveness, we investigate the concepts from Semiotics and apply cultural elements in the design of adversarial prompts. Specifically, we propose CAAM, a Culture-based Adversarial Attack on T2I Models with a generation module, which collaborates with multiple LLM-based agents to generate fluent adversarial prompts, and a feedback module, which provides feedback to compromise the stealthiness and effectiveness. Extensive experiments with open-source and commercial T2I models are conducted to demonstrate the effectiveness of our method. This paper includes model-generated content that may contain offensive or distressing material.

2025 NES-DM: Representative Attention-based CNN Network for Medical Image Classification
abstract
Various lesions in different body parts have different sizes and, in particular, different representations, which leads to great challenges for medical image classification tasks. To avoid incorrect classification, it is critical to design a model that has the ability to extract descriptive and discriminatory features. The attention mechanism is a method that can utilize layer weight adjustment to enhance feature extraction capability for various deep learning models. In this study, an attention-based CNN framework, NES-DM, is proposed to adapt to different lesions. Specifically, for the channel attention, we propose to leverage a neuron energy separability module, which aims to aggregate more representative features in a channel; for the spatial attention, we design to decompose the feature map along with two dimensions and then input them into a multiple convolution module, respectively, which aims to reduce the feature redundancy by the decomposition and capture long-range dependencies of features by the multiple convolution. The effectiveness of the proposed NES-DM based CNN framework is evaluated on three medical image datasets and NES-DM achieves at most 7.8% improvement on sensitivity compared to baselines.

2025 When Headlines Meet Minds: Empowering News Recommendations with Social Simulator
abstract
Personalized news recommendation aims to deliver content aligned with user interests. However, most existing methods rely on the objective textual content of news, overlooking the subjective social review that reflects how the news is socially perceived. Inspired by social constructionism, we propose Social Review-aware Recommendation (SRec), a novel framework that integrates both objective content and the social review. The latter is constructed through group deliberation modeled by an agent-based social simulator, providing structured representations of collective understandings toward news. In addition, SRec incorporates a reasoning-guided explanation module that produces interpretable rationales by aligning user preferences with the social review of news. Experimental results on the MIND-small and MIND-large datasets demonstrate that SRec improves AUC by at least 2.45% over competitive baselines. Further analysis confirms the value of the social review generated by the simulator, and shows the flexibility of SRec as a lightweight enhancement to existing recommendation systems.

2025 DP-Adapter: Dual-pathway adapter for boosting fidelity and text consistency in customizable human image generation
abstract
With the growing popularity of personalized human content creation and sharing, there is a rising demand for advanced techniques in customized human image generation. However, current methods struggle to simultaneously maintain the fidelity of human identity and ensure the consistency of textual prompts, often resulting in suboptimal outcomes. This shortcoming is primarily due to the lack of effective constraints during the simultaneous integration of visual and textual prompts, leading to unhealthy mutual interference that compromises the full expression of both types of input. Building on prior research that suggests visual and textual conditions influence different regions of an image in distinct ways, we introduce a novel Dual-Pathway Adapter (DP-Adapter) to enhance both high-fidelity identity preservation and textual consistency in personalized human image generation. Our approach begins by decoupling the target human image into visually sensitive and text-sensitive regions. For visually sensitive regions, DP-Adapter employs an Identity-Enhancing Adapter (IEA) to preserve detailed identity features. For text-sensitive regions, we introduce a Textual-Consistency Adapter (TCA) to minimize visual interference and ensure the consistency of textual semantics. To seamlessly integrate these pathways, we develop a Fine-Grained Feature-Level Blending (FFB) module that efficiently combines hierarchical semantic features from both pathways, resulting in more natural and coherent synthesis outcomes. Additionally, DP-Adapter supports various innovative applications, including controllable headshot-to-full-body portrait generation, age editing, old-photo to reality, and expression editing. Extensive experiments demonstrate that DP-Adapter outperforms state-of-the-art methods in both visual fidelity and text consistency, highlighting its effectiveness and versatility in the field of human image generation.

Recently, advancements in text-to-image synthesis and image customization have drawn significant attention. Among these technologies, foreground-driven image synthesis models aim to create diverse scenes for specific foregrounds, showing broad application prospects. However, existing foreground-driven diffusion models struggle to accurately generate scenes with layouts that align with user intentions. To address these challenges, we propose CompCraft, a training-free framework that enhances layout control and improves overall generation quality in current models. First, CompCraft identifies that the failure of existing methods to achieve effective control arises from the excessive influence of fully denoised foreground information on the generated scene. To address this, we propose a foreground regularization strategy that modifies the foreground-related attention maps, reducing their impact and ensuring better integration of the foreground with the generated scene. Then, we propose a series of inference-time layout guidance strategies to guide the image generation process with the user’s finely customized layouts. These strategies enable current foreground-driven diffusion models with accurate layout control. Finally, we introduce a comprehensive benchmark to evaluate CompCraft. Both quantitative and qualitative results demonstrate that CompCraft can effectively generate high-quality images with precise customized layouts, showcasing its strong capabilities in pratical image synthesis applications.

2025 ClipMix for Domain Generalization
abstract
Domain Generalization (DG) is a growing field in machine learning that aims to train the model across multiple source domains, thereby enabling effective generalization to new, unseen target domains. Recent studies suggest that data augmentation, which enhances the diversity of the source domain, might be a promising solution to address this task. Current data augmentation methods use random fusion coefficients or local regional fusion, which cannot adaptively design the weights based on data, or preserve the integrity of original semantics. Inspired by the pre-trained model CLIP, which contains extensive multimodal knowledge, we propose ClipMix to address these limitations. Firstly, we use the CLIP model as the external knowledge to adaptively evaluate the alignment between images and their labels, using this alignment to assess the complexity of learning each image and guide adaptive augmentation. Secondly, we implement a label shift mechanism to dynamically assign soft labels to fused images, helping the model focus on hard-to-learn patterns and also gather domain-agnostic representation. Furthermore, we enhance the diversity of fused images at both the pixel and feature levels. Experimental results across sixteen domains from four databases verify the effectiveness of our method.

2025 Enriched Image Captioning Based on Knowledge Divergence and Focus
abstract
Image captioning is a fundamental task in computer vision that aims to generate precise and comprehensive descriptions of images automatically. Intuitively, humans initially rely on the image content, e.g., “cake on a plate”, to gradually gather relevant knowledge facts e.g., “birthday party”, “candles”, which is a process referred to as divergence. Then, we perform step-by-step reasoning based on the images to refine, and rearrange these knowledge facts for explicit sentence generation, a process referred to as focus. However, existing image captioning methods mainly rely on the encode-decode framework that does not well fit the “divergence-focus” nature of the task. To this end, we propose the knowledge “divergence-focus” method for Image Captioning (K-DFIC) to gather and polish knowledge facts for image understanding, which consists of two components: (a) Knowledge Divergence Module aims to leverage the divergence capability of large-scale pre-trained model to acquire knowledge facts relevant to the image content. To achieve this, we design a scene-graph-aware prompt that serves as a “trigger” for GPT-3.5, encouraging it to “diverge” and generate more sophisticated, human-like knowledge. (b) Knowledge Focus Module aims to refine acquired knowledge facts and further rearrange them in a coherent manner. We design the interactive refining network to encode knowledge, which is refined with the visual features to remove irrelevant words. Then, to generate fluent image descriptions, we design the large-scale pre-trained model-based rearrangement method to estimate the importance of each knowledge word for an image. Finally, we fuse the refined knowledge and visual features to assist the decoder in generating captions. We demonstrate the superiority of our approach through extensive experiments on the MSCOCO dataset. Our approach surpasses state-of-the-art performance across all metrics in the Karpathy split. For example, our model obtains the best CIDEr-D score of 148.4%. Additional ablation studies and visualization further validate our effectiveness.

2025 MV-CLIP: Multi-View CLIP for Zero-Shot 3D Shape Recognition
abstract
Large-scale pre-trained models have demonstrated impressive performance in vision and language tasks within open-world scenarios. Due to the lack of comparable pre-trained models for 3D shapes, recent methods utilize language-image pre-training to realize zero-shot 3D shape recognition. However, due to the modality gap, pretrained language-image models are not confident enough in the generalization to 3D shape recognition. Consequently, this paper aims to improve the confidence with view selection and hierarchical prompts. Building on the well-established CLIP model, we introduce view selection in the vision side that minimizes entropy to identify the most informative views for 3D shape. On the textual side, hierarchical prompts combined of hand-crafted and GPT-generated prompts are proposed to refine predictions. The first layer prompts several classification candidates with traditional class-level descriptions, while the second layer refines the prediction based on function-level descriptions or further distinctions between the candidates. Extensive experiments demonstrate the effectiveness of the proposed modules for zero-shot 3D shape recognition. Remarkably, without the need for additional training, our proposed method achieves impressive zero-shot 3D classification accuracies of 84.44%, 91.51%, and 66.17% on ModelNet40, ModelNet10, and ShapeNet Core55, respectively. Furthermore, we will make the code publicly available to facilitate reproducibility and further research in this area.

2025 Few-Shot In-Context Learning for Implicit Semantic Multimodal Content Detection and Interpretation
abstract
In recent years, the field of explicit semantic multimodal content research makes significant progress. However, research on content with implicit semantics, such as online memes, remains insufficient. Memes often convey implicit semantics through metaphors and may sometimes contain hateful information. To address this issue, researchers propose a task for detecting hateful memes, opening up new avenues for exploring implicit semantics. The hateful meme detection currently faces two main problems: 1) the rapid emergence of meme content makes continuous tracking and detection difficult; 2) current methods often lack interpretability, which limits the understanding and trust in the detection results. To make a better understanding of memes, we analyze the definition of metaphor from social science and identify the three key factors of metaphor: socio-cultural knowledge, metaphorical tenor, and metaphorical representation pattern. According to these key factors, we guide a multimodal large language model (MLLM) to infer the metaphors expressed in memes step by step. Particularly, we propose a hateful meme detection and interpretation framework, which has four modules. We first leverage a multimodal generative search method to obtain socio-cultural knowledge relevant to visual objects of memes. Then, we use socio-cultural knowledge to instruct the MLLM to assess the social-cultural relevance scores between visual objects and textual information, and identify the metaphorical tenor of memes. Meanwhile, we apply a representative interpretation method to provide representative cases of memes and analyze these cases to explore metaphorical representation pattern. Finally, a chain-of-thought prompt is constructed to integrate the output of the above modules, guiding the MLLM to accurately detect and interpret hateful memes. Our method achieves state-of-the-art performance on three hateful meme detection benchmarks and performs better than supervised training models on the hateful meme interpretation benchmark.

2025 MMPFormer: A Memory-Aware Multiscale Predictive Transformer for Precipitation Nowcasting
abstract
In recent years, global climate change has intensified, leading to frequent occurrences of short-term extreme rain-fall events. How to accurately predict short-term precipitation within the next few hours has become a concern for people, especially for meteorologists. Traditional Numerical Weather Prediction (NWP) models rely on solving complex physical equations, resulting in significant computational costs and low temporal resolution, which limit their suitability for nowcasting tasks. Weather radar echo extrapolation, which forecasts future echoes from historical observations, has thus become the predominant approach for precipitation nowcasting. In the realm of deep learning-based methods, convolutional or recurrent neural network-based extrapolation pipelines inherently struggle in processing sequential data and capturing the multi-scale spatial features inherent in radar echo images. Additionally, current models often focus on enhancing dense prediction capabilities while neglecting to mine or utilize the evolutionary patterns of historical echoes, leading to diminished accuracy in long-term sequence forecasting. Moreover, high precipitation areas are critical for public safety, but current models often fail to forecast them accurately due to insufficient emphasis during learning. In this paper, we propose a memory-aware multi-scale predictive transformer (MMPFormer) for precipitation nowcasting. Specifically, we designed the Multi-Scale Spatial-Temporal Transformer (MS-STT), which incorporates multi-scale convolution techniques alongside self-attention mechanisms to effectively extract and model the spatiotemporal correlations within historical radar echoes. Additionally, we have designed a ConvGRU-Instructed Memory Mechanism (CIMM) to alleviate the degradation of radar echo details during extended extrapolation periods, enabling accurate forecasts over the next three hours. Furthermore, the Key Area Attention Module (KAAM), a plug-and-play module, has been introduced. It emphasizes high precipitation areas through attention mechanisms, mitigating the negative impacts of missing high precipitation by previous learning-based methods. Quantitative and qualitative experimental results on radar echo datasets demonstrate the superior performance of our method in modeling spatiotemporal dynamics and long-term extrapolation for precipitation forecasting.

2025 Toward Chinese Food Understanding: A Cross-Modal Ingredient-Level Benchmark
abstract
Although there are several food-level benchmarks for food-related learning, the lack of fine-grained ingredient annotation significantly impedes progress in food scene understanding. In this study, we focus on Chinese food understanding which involves fine-grained ingredient detection and cross-modal ingredient retrieval. Specifically, to support studies on Chinese food understanding, we build the first cross-modal ingredientlevel dataset called CMIngre, which contains 8,001 image-text pairs from three different sources, i.e. dishes, recipes, and usergenerated content, covering 429 distinct ingredients and 95,290 bounding boxes. Based on CMIngre, we evaluate the performance of traditional CNN-based detection algorithms and transformerbased pre-trained large models for ingredient detection. We also propose baseline methods for the cross-modal ingredient retrieval task in both the end-to-end and two-stage settings. Extensive experiments on CMIngre demonstrate the effectiveness of our proposed methods on food understanding

2025 MarkPlugger: Generalizable Watermark Framework for Latent Diffusion Models Without Retraining
abstract
Today, the family of latent diffusion models (LDMs) has gained prominence for its high quality outputs and scalability. This has also raised security concerns on social media, as malicious users can create and disseminate harmful content. Existing approaches typically involve training specific components or entire generative models to embed a watermark in generated images for traceability and responsibility. However, in the fast-evolving era of AI-generated content (AIGC), the rapid iteration and modification of LDMs makes retraining with watermark models costly. To address the problem, we proposeMarkPlugger, a generalizable plug-and-play watermark framework without LDM retrain. In particular, to reduce the disturbance of the watermark on the semantic of the generated image, we try to identify a watermark representation that is approaching orthogonal to the semantic in latent space, and the theoretical study shows that we can achieve approximate orthogonality in a high-dimensional space. Moreover, the offset through an additive fusion strategy for the watermark and the semantic is also bounded. Without modifying any components of the LDMs, we embed diverse watermarks in latent space, adapting to the denoising process. Our experimental findings reveal that our method effectively harmonizes image quality and watermark recovery rate. We also have validated that our method is generalized to multiple official versions and modified variants of LDMs, even without retraining the watermark model. Furthermore, it performs robustly under various attacks of different intensities.

2025 Model Can Be Subtle: Two Important Mechanisms for Social Media Popularity Prediction
abstract
Social media popularity prediction is an important channel to explore content sharing and communication on social networks. It aims to capture informative cues by analyzing multi-type data (such as user profile, image, and text) to decide the popularity of a specified post. In this article, we divide social network users into two categories (i.e., active and inactive users) and find a dilemma in existing models: If an active user publishes the low-popularity post, the model will habitually predict the high score. On the contrary, if an inactive user provides the high-popularity post, the model still gives the low score incorrectly. Therefore, how to make the model more subtle to users is important. Comparing to existing methods that directly leverage multi-modal features for regression training, this article stresses more on two novel mechanisms. The first method aims to prevent the over-fitting on user IDs. We propose the attribute-sensitive interactive mechanism (M1) by incorporating explicit user-attribute and post-attribute interaction. It can analyze which type of features a user cares the most and weaken the model’s dependence on user IDs. The second method aims to strengthen the influence of post content. We propose the knowledge embedding mechanism (M2) to revise the popularity scores in existing models by fusing the statistical frequency over multi-type data. Note that both mechanisms are model-agnostic, which can be applicable in any popularity prediction model. Extensive experiments conducted on the Social Media Prediction Dataset further validate the effectiveness.

2024 Bots Shield Fake News: Adversarial Attack on User Engagement based Fake News Detection
abstract
The surge in detecting fake news on social networks leads to increased research attention, particularly in the realm of deep learning models based on graph neural networks (GNNs). However, as research progresses, concerns emerge about the vulnerability of these detection models. In this study, we introduce an attack problem that perturbs user-news engagements by injecting bots to shield the targeted fake news from being detected by GNN-based fake news detection models. We propose a black-box attack method named Query-enhanced Surrogate-based Attack under Assortativity Constraint (QSA-AC) to work for this attack problem. QSA-AC combines surrogate-based and query-based approaches to improve attack effectiveness. At the same time, QSA-AC maintains a balance between attack effectiveness and imperceptibility by adjusting the local fluctuations of the assortativity with respect to the news on the social network. In addition, we introduce an evaluation metric, local strength assortativity perturbation rate (LSAPR), to assess the imperceptibility of the attack from the local perspective. Extensive experiments on two fake news datasets demonstrate that the proposed QSA-AC can achieve the optimal attack effectiveness, and control the trade-off between the attack effectiveness and imperceptibility.

2024 AnyScene: Customized Image Synthesis with Composited Foreground
abstract
Recent advancements in text-to-image technology have significantly advanced the field of image customization. Among various applications, the task of customizing diverse scenes for user-specified composited elements holds great application value but has not been extensively explored. Addressing this gap, we propose AnyScene, a specialized framework designed to create varied scenes from compos-ited foreground using textual prompts. AnyScene addresses the primary challenges inherent in existing methods, particularly scene disharmony due to a lack of foreground semantic understanding and distortion of foreground elements. Specifically, we develop a foreground injection module that guides a pretrained diffusion model to generate cohesive scenes in visual harmony with the provided foreground. To enhance robust generation, we implement a layout control strategy that prevents distortions of foreground elements. Furthermore, an efficient image blending mechanism seam-lessly reintegrates foreground details into the generated scenes, producing outputs with overall visual harmony and precise foreground details. In addition, we propose a new benchmark and a series of quantitative metrics to evaluate this proposed image customization task. Extensive experimental results demonstrate the effectiveness of AnyScene, which confirms its potential in various applications.

2024 Rumor Detection Framework Based on Multi-source Knowledge Adaptation
abstract
Rumors proliferating on social media pose significant risks to politics, economics, and society. A considerable amount of research focuses on improving automated rumor detection models on dedicated datasets, but their performance often plummets when applied to novel, unforeseen events due to varying data distributions. Inspired by domain adaptation and few-shot learning, we propose the Multi-Source Knowledge Adaptation framework MSKA. It is a plug-and-play framework where any rumor detection model can be integrated to enhance its performance in detecting contemporary events. Specifically, MSKA relies on event-level knowledge adaptation and cross-domain category alignment to compel the rumor detection model to learn more discriminative knowledge representations. Experiments on the public dataset demonstrate that MSKA improves the performance of the base rumor detection model in detecting emerging events and outperforms other baselines. In terms of accuracy, MSKA achieves at least a 7% improvement over the base rumor detection model.

2024 Certified Robustness on Visual Graph Matching via Searching Optimal Smoothing Range
abstract
Deep visual graph matching (GM) is a challenging combinatorial task that involves finding a permutation matrix that indicates the correspondence between keypoints from a pair of images. Like many learning systems, empirical studies have shown that visual GM is susceptible to adversarial attacks, with reliability issues in downstream applications. To the best of our knowledge, certifying robustness for deep visual GM remains an open challenge with two main difficulties: how to handle the paired inputs together with the heavily non-linear permutation output space (especially at large scale), and how to balance the trade-off between certified robustness and matching performance.

2024 MCDAN: A Multi-Scale Context-Enhanced Dynamic Attention Network for Diffusion Prediction
abstract
Information diffusion prediction aims at predicting the target users in the information diffusion path on social networks. Prior works mainly focus on the observed structure or sequence of cascades, trying to predict to whom this cascade will be infected passively. In this study, we argue that user intent understanding is also a key part of information diffusion prediction. We thereby propose a novel Multi-scale Context-enhanced Dynamic Attention Network (MCDAN) to predict which user will most likely join the observed current cascades. Specifically, to consider the global interactive relationship among users, we take full advantage of user friendships and global cascading relationships, which are extracted from the social network and historical cascades, respectively. To refine the model's ability to understand the user's preference for the current cascade, we propose a multi-scale sequential hypergraph attention module to capture the dynamic preference of users at different time scales. Moreover, we design a contextual attention enhancement module to strengthen the interaction of user representations within the current cascade. Finally, to engage the user's own susceptibility, we construct a susceptibility label for each user based on user susceptibility analysis and use the rank of this label for auxiliary prediction. We conduct experiments over four widely used datasets and show that MCDAN significantly overperforms the state-of-the-art models. The average improvements are up to 5.41% in terms of Hits@100 and 8.47% in terms of MAP@100, respectively.

2023 Automatic Data Transformation Using Large Language Model - An Experimental Study on Building Energy Data
abstract
Existing approaches to automatic data transformation are insufficient to meet the requirements in many real-world scenarios, such as the building sector. First, there is no convenient interface for domain experts to provide domain knowledge easily. Second, they require significant training data collection overheads. Third, the accuracy suffers from complicated schema changes. To address these shortcomings, we present a novel approach that leverages the unique capabilities of large language models (LLMs) in coding, complex reasoning, and zero-shot learning to generate SQL code that transforms the source datasets into the target datasets. We demonstrate the viability of this approach by designing an LLM-based framework, termed SQLMorpher, which comprises a prompt generator that integrates the initial prompt with optional domain knowledge and historical patterns in external databases. It also implements an iterative prompt optimization mechanism that automatically improves the prompt based on flaw detection. The key contributions of this work include (1) pioneering an end-to-end LLM-based solution for data transformation, (2) developing a benchmark dataset of 105 real-world building energy data transformation problems, and (3) conducting an extensive empirical evaluation where our approach achieved 96% accuracy in all 105 problems. SQLMorpher demonstrates the effectiveness of utilizing LLMs in complex, domain-specific challenges, highlighting the potential of their potential to drive sustainable solutions.

2023 Robustness Certification for Structured Prediction with General Inputs via Safe Region Modeling in the Semimetric Output Space
abstract
Many real-world machine learning problems involve structured prediction beyond categorical labels. However, most existing robustness certification works are devoted to the classification case. It remains open for robustness certification for more general outputs. In this paper, we propose a novel framework of robustness certification for structured prediction problems, where the output space is modeled as a semimetric space with a distance function that satisfies non-negativity and symmetry but not necessarily the triangle inequality. We further develop our tailored certification methods for binary, numerical, and hybrid inputs in structured prediction. Experiment results show that our method achieves tighter robustness guarantees than the SOTA structured certification baseline for numerical inputs (for which it only supports) with ℓ2 norm perturbation when outputs are measured by intersection over union (IoU) similarity, total variation distance, and perceptual distance. Moreover, we achieve good robustness certification for binary inputs with ℓ0 norm perturbation and hybrid inputs with corresponding perturbation when outputs are measured by Manhattan distance.

2023 Towards Deconfounded Image-Text Matching with Causal Inference
abstract
Prior image-text matching methods have shown remarkable performance on many benchmark datasets, but most of them overlook the bias in the dataset, which exists in intra-modal and inter-modal, and tend to learn the spurious correlations that extremely degrade the generalization ability of the model. Furthermore, these methods often incorporate biased external knowledge from large-scale datasets as prior knowledge into image-text matching model, which is inevitable to force model further learn biased associations. To address above limitations, this paper firstly utilizes Structural Causal Models (SCMs) to illustrate how intra- and inter-modal confounders damage the image-text matching. Then, we employ backdoor adjustment to propose an innovative Deconfounded Causal Inference Network (DCIN) for image-text matching task. DCIN (1) decomposes the intra- and inter-modal confounders and incorporates them into the encoding stage of visual and textual features, effectively eliminating the spurious correlations during image-text matching, and (2) uses causal inference to mitigate biases of external knowledge. Consequently, the model can learn causality instead of spurious correlations caused by dataset bias. Extensive experiments on two well-known benchmark datasets, i.e., Flickr30K and MSCOCO, demonstrate the superiority of our proposed method.

2023 Progressive Positive Association Framework for Image and Text Retrieval
abstract
With the increasing amount of multimedia data, the demand for fast and accurate access to information is growing. Image and text retrieval learns visual and textual semantic relationships for multimedia data management and content recognition. The main challenge of this task is how to derive image and text similarity based on local associations under huge modal gap. However, the existing methods compute semantic relevance using associations of all fragments (visual regions and textual words), which underestimate the uncertainty of associations and discriminative positive associations leading to cross-modal correspondence ambiguity. To address these issues, we propose a novel Progressive Positive Association Framework (PPAF), which models association uncertainty as a normal distribution and progressively mines direct and potential positive associations according to the characteristics of the association distribution. We design positive association matching, which adaptively fuses multi-step associations for local matching depending on the relevance difference. In addition, we apply KL loss constraint on cross-modal association distribution in order to enhance local semantic alignment. Extended experiments demonstrate the leading performance of PPAF.

2023 Improving Rumor Detection by Class-based Adversarial Domain Adaptation
abstract
Since rumors widely spread on social networks can cause serious negative impacts, a batch of studies have investigated how to detect rumors. Most of them rely on existing datasets and try to improve the detection performance on those known datasets, but their performance drops significantly when detecting newly emerging events. This is not in line with the original intention of the rumor detection task. To tackle this issue, we formulate the rumor detection problem as a domain adaption task and propose the Class-based Adversarial Domain Adaptive framework, CADA, which is a general model framework where any latest rumor detection methods can be plugged-in. The improvement of new emerging rumor event detection is based on adversarial training. Specifically, CADA considers class-based discriminators to achieve fine-grained alignment of declarations to be detected of different classes. Experiments on three public datasets show that CADA can improve the detection performance of existing rumor detection models and achieve better results than state-of-the-art models. In terms of accuracy, the performance is improved by at least 3% compared with the original base model in the PHEME dataset, and as high as 10% in the Twitter datasets.

2023 My Brother Helps Me: Node Injection Based Adversarial Attack on Social Bot Detection
abstract
Social platforms such as Twitter are under siege from a multitude of fraudulent users. In response, social bot detection tasks have been developed to identify such fake users. Due to the structure of social networks, the majority of methods are based on the graph neural network(GNN), which is susceptible to attacks. In this study, we propose a node injection-based adversarial attack method designed to deceive bot detection models. Notably, neither the target bot nor the newly injected bot can be detected when a new bot is added around the target bot. This attack operates in a black-box fashion, implying that any information related to the victim model remains unknown. To our knowledge, this is the first study exploring the resilience of bot detection through graph node injection. Furthermore, we develop an attribute recovery module to revert the injected node embedding from the graph embedding space back to the original feature space, enabling the adversary to manipulate node perturbation effectively. We conduct adversarial attacks on four commonly used GNN structures for bot detection on two widely used datasets: Cresci-2015 and TwiBot-22. The attack success rate is over 73% and the rate of newly injected nodes being detected as bots is below 13% on these two datasets.

2023 Vulnerability of Feature Extractors in 2D Image-Based 3D Object Retrieval
abstract
Recent advances in 3D modeling software and 3D capture devices contribute to the availability of large-scale 3D objects. Together with the prevalence of deep neural networks (DNNs), DNN-based 3D object retrieval systems are widely applied, especially by inputting 2D images to retrieve 3D objects. Although DNNs have shown vulnerable to adversarial attacks in classification, the vulnerability of DNN-based 3D object retrieval system remains under-explored. In this paper, we formulate the problem of attacking against DNN-based feature extractors in the 2D image-based 3D object retrieval system. Specifically, we consider the attack happens under a reasonable scenario that the candidate 3D object database is unknown to the adversary, which challenges adversarial example generation. To tackle this difficulty, we set up a reasonable hypothesis on the information which the adversary can be accessible, and then propose two effective perturbation generation methods: one is to corrupt domain-level alignment (CDA) and the other one is to corrupt class-level alignment (CCA). In converse, we propose a novel progressive adversarial training (PAT) method to improve the feature extractor robustness, which can effectively and stably mitigate both CDA and CCA attacks. Experimental results demonstrate that a typical feature extractor can be effectively compromised by attacks. Moreover, the transferability of the adversarial query illustrates the possibility of realistic black-box attacks. The successful defense against both CDA and CCA attacks by PAT can validate the superiority of the proposed defense method.

2022 Cosine Model Watermarking against Ensemble Distillation
abstract
Many model watermarking methods have been developed to prevent valuable deployed commercial models from being stealthily stolen by model distillations. However, watermarks produced by most existing model watermarking methods can be easily evaded by ensemble distillation, because averaging the outputs of multiple ensembled models can significantly reduce or even erase the watermarks. In this paper, we focus on tackling the challenging task of defending against ensemble distillation. We propose a novel watermarking technique named CosWM to achieve outstanding model watermarking performance against ensemble distillation. CosWM is not only elegant in design, but also comes with desirable theoretical guarantees. Our extensive experiments on public data sets demonstrate the excellent performance of CosWM and its advantages over the state-of-the-art baselines.

2022 Towards Edge-Cloud Collaborative Machine Learning: A Quality-aware Task Partition Framework
abstract
Edge-cloud collaborative tasks with real-world services emerge in recent years and attract worldwide attention. Unfortunately, state-of-the-art edge-cloud collaborative machine-learning services are still not that reliable due to the data heterogeneity on the edge, where we usually have access to a mixed-up training set, which is intrinsically collected from various distributions of underlying tasks. Finding such hidden tasks that need to be revealed from given datasets is called the Task Partition problem. Manual task partition is usually expensive, unscalable, and biased. Accordingly, we propose Quality-aware Task Partition (QTP) problem, in which final tasks are partitioned by the performance of task models. To the best of our knowledge, this work is the first one to study the QTP problem with an emphasis on task quality. We also implement a public service, HiLens on Huawei Cloud, to support the whole process. We develop a polynomial-time algorithm namely the Task-Forest algorithm (TForest). TForest shows its superiority based on a case study with 57 real-world cameras. Compared with STOA baselines, TForest has on average 9.2% higher F1-scores and requires 43.1% fewer samples when deploying new cameras. Partial code of the framework has been adopted and released to KubeEdge-Sedna.

2022 Human Guided Exploitation of Interpretable Attention Patterns in Summarization and Topic Segmentation
abstract
The multi-head self-attention mechanism of the transformer model has been thoroughly investigated recently. In one vein of study, researchers are interested in understanding why and how transformers work.In another vein, researchers propose new attention augmentation methods to make transformers more accurate, efficient and interpretable. In this paper, we combine these two lines of research in a human-in-the-loop pipeline to first discover important task-specific attention patterns. Then those patterns are injected, not only to smaller models, but also to the original model. The benefits of our pipeline and discovered patterns are demonstrated in two case studies with extractive summarization and topic segmentation. After discovering interpretable patterns in BERT-based models fine-tuned for the two downstream tasks, experiments indicate that when we inject the patterns into attention heads, the models show considerable improvements in accuracy and efficiency.

Non-IID data present a tough challenge for federated learning. In this paper, we explore a novel idea of facilitating pairwise collaborations between clients with similar data. We propose FedAMP, a new method employing federated attentive message passing to facilitate similar clients to collaborate more. 2021 Finding Representative Interpretations on Convolutional Neural Networks
abstract
Interpreting the decision logic behind effective deep convolutional neural networks (CNN) on images complements the success of deep learning models. However, the existing methods can only interpret some specific decision logic on individual or a small number of images. To facilitate human understandability and generalization ability, it is important to develop representative interpretations that interpret common decision logics of a CNN on a large group of similar images, which reveal the common semantics data contributes to many closely related predictions. In this paper, we develop a novel unsupervised approach to produce a highly representative interpretation for a large number of similar images. We formulate the problem of finding representative interpretations as a co-clustering problem, and convert it into a submodular cost submodular cover problem based on a sample of the linear decision boundaries of a CNN. We also present a visualization and similarity ranking method. Our extensive experiments demonstrate the excellent performance of our method.

2021 Stealthy Targeted Data Poisoning Attack on Knowledge Graphs
abstract
A host of different KG embedding techniques have emerged recently and have been empirically shown to be very effective in accurately predicting missing facts in a KG, thus improving its coverage and quality. Unfortunately, embedding techniques can fall prey to adversarial data poisoning attack. In this form of attack, facts may be added to or deleted from a KG, called performing perturbations, that results in the manipulation of the plausibility of target facts in a KG. While recent works confirm this intuition, the attacks considered there ignore the risk of exposure. Intuitively, an attack is of limited value if it is highly likely to be caught, i.e., exposed. To address this, we introduce a notion of the exposure risk and propose a novel problem of attacking a KG by means of perturbations where the goal is to maximize the manipulation of the target fact's plausibility while keeping the risk of exposure under a given budget. We design a deep reinforcement learning-based framework, called RATA, that learns to use low-risk perturbations without compromising on the performance, i.e., manipulation of target fact plausibility. We test the performance of RATA against recently proposed strategies for KG attacks, on two different benchmark datasets and on different kinds of target facts. Our experiments show that RATA achieves state-of-the-art performance even while using a fraction of the risk.

2021 Auto-Split: A General Framework of Collaborative Edge-Cloud AI
abstract
In many industry scale applications, large and resource consuming machine learning models reside in powerful cloud servers. At the same time, large amounts of input data are collected at the edge of cloud. The inference results are also communicated to users or passed to downstream tasks at the edge. The edge often consists of a large number of low-power devices. It is a big challenge to design industry products to support sophisticated deep model deployment and conduct model inference in an efficient manner so that the model accuracy remains high and the end-to-end latency is kept low. This paper describes the techniques and engineering practice behind Auto-Split, an edge-cloud collaborative prototype of Huawei Cloud. This patented technology is already validated on selected applications, is on its way for broader systematic edge-cloud application integration, and is being made available for public use as an automated pipeline service for end-to-end cloud-edge collaborative intelligence deployment. To the best of our knowledge, there is no existing industry product that provides the capability of Deep Neural Network (DNN) splitting.

2021 Towards Fair Federated Learning
abstract
Federated learning has become increasingly popular as it facilitates collaborative training of machine learning models among multiple clients while preserving their data privacy. In practice, one major challenge for federated learning is to achieve fairness in collaboration among the participating clients, because different clients' contributions to a model are usually far from equal due to various reasons. Besides, as machine learning models are deployed in more and more important applications, how to achieve model fairness, that is, to ensure that a trained model has no discrimination against sensitive attributes, has become another critical desiderata for federated learning. In this tutorial, we discuss formulations and methods such that collaborative fairness, model fairness, and privacy can be fully respected in federated learning. We review the existing efforts and the latest progress, and discuss a series of potential directions.

2021 Robust Counterfactual Explanations on Graph Neural Networks
abstract
Massive deployment of Graph Neural Networks (GNNs) in high-stake applications generates a strong demand for explanations that are robust to noise and align well with human intuition. Most existing methods generate explanations by identifying a subgraph of an input graph that has a strong correlation with the prediction. These explanations are not robust to noise because independently optimizing the correlation for a single input can easily overfit noise. Moreover, they are not counterfactual because removing an identified subgraph from an input graph does not necessarily change the prediction result. In this paper, we propose a novel method to generate robust counterfactual explanations on GNNs by explicitly modelling the common decision logic of GNNs on similar input graphs. Our explanations are naturally robust to noise because they are produced from the common decision boundaries of a GNN that govern the predictions of many similar input graphs. The explanations are also counterfactual because removing the set of edges identified by an explanation from the input graph changes the prediction significantly. Exhaustive experiments on many public datasets demonstrate the superior performance of our method.

2020 A High Precision Pipeline for Financial Knowledge Graph Construction
abstract
Motivated by applications such as question answering, fact checking, and data integration, there is significant interest in constructing knowledge graphs by extracting information from unstructured information sources, particularly text documents.Knowledge graphs have emerged as a standard for structured knowledge representation, whereby entities and their inter-relations are represented and conveniently stored as (subject, predicate, object) triples in a graph that can be used to power various downstream applications. The proliferation of financial news sources reporting on companies, markets, currencies, and stocks presents an opportunity for extracting valuable knowledge about this crucial domain. In this paper, we focus on constructing a knowledge graph automatically by information extraction from a large corpus of financial news articles. For that purpose, we develop a high precision knowledge extraction pipeline tailored for the financial domain. This pipeline combines multiple information extraction techniques with a financial dictionary that we built, all working together to produce over 342,000 compact extractions from over 288,000 financial news articles, with a precision of 78% at the top-100 extractions. The extracted triples are stored in a knowledge graph making them readily available for use in downstream applications.

2020 Exact and Consistent Interpretation of Piecewise Linear Models Hidden behind APIs: A Closed Form Solution
abstract
More and more AI services are provided through APIs on cloud where predictive models are hidden behind APIs. To build trust with users and reduce potential application risk, it is important to interpret how such predictive models hidden behind APIs make their decisions. The biggest challenge of interpreting such predictions is that no access to model parameters or training data is available. Existing works interpret the predictions of a model hidden behind an API by heuristically probing the response of the API with perturbed input instances. However, these methods do not provide any guarantee on the exactness and consistency of their interpretations. In this paper, we propose an elegant closed form solution named OpenAPI to compute exact and consistent interpretations for the family of Piecewise Linear Models (PLM), which includes many popular classification models. The major idea is to first construct a set of overdetermined linear equation systems with a small set of perturbed instances and the predictions made by the model on those instances. Then, we solve the equation systems to identify the decision features that are responsible for the prediction on an input instance. Our extensive experiments clearly demonstrate the exactness and consistency of our method.

2019 G3raphGround: Graph-Based Language Grounding
abstract
In this paper we present an end-to-end framework for grounding of phrases in images. In contrast to previous works, our model, which we call G3raphGround, uses graphs to formulate more complex, non-sequential dependencies among proposal image regions and phrases. We capture intra-modal dependencies using a separate graph neural network for each modality (visual and lingual), and then use conditional message-passing in another graph neural network to fuse their outputs and capture cross-modal relationships. This final representation results in grounding decisions. The framework supports many-to-many matching and is able to ground single phrase to multiple image regions and vice versa. We validate our design choices through a series of ablation studies and illustrate state-of-the-art performance on Flickr30k and ReferIt Game benchmark datasets.

2019 Online Density Bursting Subgraph Detection from Temporal Graphs
abstract
Given a temporal weighted graph that consists of a potentially endless stream of updates, we are interested in finding density bursting subgraphs (DBS for short), where a DBS is a subgraph that accumulates its density at the fastest speed. Online DBS detection enjoys many novel applications. At the same time, it is challenging since the time duration of a DBS can be arbitrarily long but a limited size storage can buffer only up to a certain number of updates. To tackle this problem, we observe the critical decomposability of DBSs and show that a DBS with a long time duration can be decomposed into a set of indecomposable DBSs with equal or larger burstiness. We further prove that the time duration of an indecomposable DBS is upper bounded and propose an efficient method TopkDBSOL to detect indecomposable DBSs in an online manner. Extensive experiments demonstrate the effectiveness, efficiency and scalability of TopkDBSOL in detecting significant DBSs from temporal graphs in real applications.

2018 A unified scheme of text localization and structured data extraction for joint OCR and data mining
abstract
Both text detection and structured data extraction are imperative in an optical character recognition (OCR) processing pipeline. Text detection, especially for indistinct, diverse, multi-language text regions, is one of the most challenging tasks in computer vision and has attracted increasing attention recently. Moreover, although there are some studies in data mining related to structured data extraction, it has not received its deserved attention as one of important steps in OCR. The previous methods for structural data extraction, including layout template-based, rule-based, and natural language processing (NLP)-based methods, usually leads to either inaccurate results or complex modules. In this paper, we integrate text detection and structured data extraction into a unified deep learning-based Image Text Extraction (ITE) scheme. Our ITE is an end-to-end trainable model and able to handle multi-scale and multi-lingual text in a single process. Experiments on large-scale real-world passport and medical receipt datasets have demonstrated the superiority of the proposed method in terms of both effectiveness and efficiency.

2018 Exact and Consistent Interpretation for Piecewise Linear Neural Networks: A Closed Form Solution
abstract
Strong intelligent machines powered by deep neural networks are increasingly deployed as black boxes to make decisions in risk-sensitive domains, such as finance and medical. To reduce potential risk and build trust with users, it is critical to interpret how such machines make their decisions. Existing works interpret a pre-trained neural network by analyzing hidden neurons, mimicking pre-trained models or approximating local predictions. However, these methods do not provide a guarantee on the exactness and consistency of their interpretations. In this paper, we propose an elegant closed form solution named $OpenBox$ to compute exact and consistent interpretations for the family of Piecewise Linear Neural Networks (PLNN). The major idea is to first transform a PLNN into a mathematically equivalent set of linear classifiers, then interpret each linear classifier by the features that dominate its prediction. We further apply $OpenBox$ to demonstrate the effectiveness of non-negative and sparse constraints on improving the interpretability of PLNNs. The extensive experiments on both synthetic and real world data sets clearly demonstrate the exactness and consistency of our interpretation.

2017 Exploiting Stable Data Dependency in Stream Processing Acceleration on FPGAs
abstract
With the unique feature of fine-grained parallelism, field-programmable gate arrays (FPGAs) show great potential for streaming algorithm acceleration. However, the lack of a design framework, restrictions on FPGAs, and ineffective tools impede the utilization of FPGAs in practice. In this study, we provide a design paradigm to support streaming algorithm acceleration on FPGAs. We first propose an abstract model to describe streaming algorithms with homogeneous sub-functions (HSF) and stable data dependency (SDD), which we call the HSF-SDD model. Using this model, we then develop an FPGA framework, PE-Ring, that has the advantages of (1) fully exploiting algorithm parallelism to achieve high performance, (2) leveraging block RAM to serve large scale parameters, and (3) enabling flexible parameter adjustments. Based on the proposed model and framework, we finally implement a specific converter to generate the register-transfer level representation of the PE-Ring. Experimental results show that our method outperforms ordinary FPGA design tools by one to two orders of magnitude. Experiments also demonstrate the scalability of the PE-Ring.

2015 Schema Management for Document Stores
abstract
Document stores that provide the efficiency of a schema-less interface are widely used by developers in mobile and cloud applications. However, the simplicity developers achieved controversially leads to complexity for data management due to lack of a schema. In this paper, we present a schema management framework for document stores. This framework discovers and persists schemas of JSON records in a repository, and also supports queries and schema summarization. The major technical challenge comes from varied structures of records caused by the schema-less data model and schema evolution. In the discovery phase, we apply a canonical form based method and propose an algorithm based on equivalent sub-trees to group equivalent schemas efficiently. Together with the algorithm, we propose a new data structure, eSiBu-Tree, to store schemas and support queries. In order to present a single summarized representation for heterogenous schemas in records, we introduce the concept of "skeleton", and propose to use it as a relaxed form of the schema, which captures a small set of core attributes. Finally, extensive experiments based on real data sets demonstrate the efficiency of our proposed schema discovery algorithms, and practical use cases in real-world data exploration and integration scenarios are presented to illustrate the effectiveness of using skeletons in these applications.

2014 Accelerating frequent item counting with FPGA
abstract
Frequent item counting is one of the most important operations in time series data mining algorithms, and the space saving algorithm is a widely used approach to solving this problem. With the rapid rising of data input speeds, the most challenging problem in frequent item counting is to meet the requirement of wire-speed processing. In this paper, we propose a streaming oriented PE-ring framework on FPGA for counting frequent items. Compared with the best existing FPGA implementation, our basic PE-ring framework saves 50% lookup table resources cost and achieves the same throughput in a more scalable way. Furthermore, we adopt SIMD-like cascaded filter for further performance improvements, which outperforms the previous work by up to 3.24 times in some data distributions.

2013 Accelerating subsequence similarity search based on dynamic time warping distance with FPGA
abstract
Subsequence search, especially subsequence similarity search, is one of the most important subroutines in time series data mining algorithms, and there is increasing evidence that Dynamic Time Warping (DTW) is the best distance metric. However, in spite of the great effort in software speedup techniques, including early abandoning strategies, lower bound, indexing, computation-reuse, DTW still cost too much time for many applications, e.g. 80% of the total time. Since DTW is a 2-Dimension sequential dynamic search with quite high data dependency, it is hard to use parallel hardware to accelerate it. In this work, we propose a novel framework for FPGA based subsequence similarity search and a novel PE-ring structure for DTW calculation. This framework utilizes the data reusability of continuous DTW calculations to reduce the bandwidth and exploit the coarse-grain parallelism; meanwhile guarantees the accuracy with a two-phase precision reduction. The PE-ring supports on-line updating patterns of arbitrary lengths, and utilizes the hard-wired synchronization of FPGA to realize the fine-grained parallelism. It also achieves flexible parallelism degree to do performance-cost trade-off. The experimental results show that we can achieve several orders of magnitude speedup in accelerating subsequence similarity search compared with the best software and current GPU/FPGA implementations in different datasets.

2012 Dynamic All-Red Extension at a Signalized Intersection: A Framework of Probabilistic Modeling and Performance Evaluation
abstract
Dynamic all-red extension (DARE) has recently attracted research interest as a nontraditional intersection collision-avoidance method, for which the prediction of red-light running (RLR) and its related hazardous situations is a crucial part. We propose a probabilistic framework to model and predict RLR hazards for DARE. The RLR hazard, which is quantified by a predictive encroachment time, has contributory factors, including the speed, distance, and car-following status of the violator and the empirical distribution of the entry time of conflict traffic. An offline data analysis procedure is developed to set the parameters for RLR hazard prediction. Online-wise, a 2-D normal model is developed to predict the vehicle's stop–go maneuver based on speeds at advanced detectors and the car-following status. Additionally, unlike most prediction models that are designed to minimize mean errors, our model identifies two types of errors, namely, the false alarm and a missed report. The capability of distinguishing these two types of errors is crucial to the effectiveness of dynamic operations. To quantify the tradeoff between these two types of errors in DARE, a system operating characteristic (SOC) function is then defined. Effectiveness of the proposed model and its prediction algorithm is demonstrated using data collected from a field intersection. At a false-alarm rate of less than 5% (or equivalently about one false trigger per 8 h), the algorithm reached a correct detection rate of over 70% to more than 80%. Performance evaluation results showed that the proposed DARE framework can effectively predict the RLR hazards.
