Bridging Modalities via Progressive Re-alignment for Multimodal Test-Time AdaptationabstractTest-time adaptation (TTA) enables online model adaptation using only unlabeled test data, aiming to bridge the gap between source and target distributions. However, in multimodal scenarios, varying degrees of distribution shift across different modalities give rise to a complex coupling effect of unimodal shallow feature shift and cross-modal high-level semantic misalignment, posing a major obstacle to extending existing TTA methods to the multimodal field. To address this challenge, we propose a novel multimodal test-time adaptation (MMTTA) framework, termed as Bridging Modalities via Progressive Re-alignment (BriMPR). BriMPR, consisting of two progressively enhanced modules, tackles the coupling effect with a divide-and-conquer strategy. Specifically, we first decompose MMTTA into multiple unimodal feature alignment sub-problems. By leveraging the strong function approximation ability of prompt tuning, we calibrate the unimodal global feature distributions to their respective source distributions, so as to achieve the initial semantic re-alignment across modalities. Subsequently, we assign the credible pseudo-labels to combinations of masked and complete modalities, and introduce inter-modal instance-wise contrastive learning to further enhance the information interaction among modalities and refine the alignment. Extensive experiments on MMTTA tasks, including both corruption-based and real-world domain shift benchmarks, demonstrate the superiority of our method. Jiacheng Li 0006, Songhe Feng

Dual Graph Disambiguation for Multi-Instance Partial-Label LearningabstractIn multi-instance partial label learning (MIPL), each sample is a bag of multiple instances linked to a candidate label set containing one true and multiple false labels, yielding inexact supervision in both instance features and label space. However, existing works adopt decoupled approaches that focus exclusively on either instance-level feature fusion or label-level disambiguation, failing to fully exploit the intrinsic dependencies between these two spaces. To overcome this limitation, graph-based methods are widely recognized as a powerful paradigm in weakly supervised learning, yet their success hinges on reliable features—precisely what MIPL lacks due to instance-level noise. To bridge this gap, we propose DualG, a novel framework that simultaneously addresses feature learning and label disambiguation through dual-level graph propagation. Specifically, we construct dual relevance graphs at both the bag and instance levels. At the bag level, we build a similarity graph based on fused feature representations; at the instance level, we employ attention scores to filter out irrelevant instances and construct a reliable instance-level relevance graph. These complementary graphs enable our joint label disambiguation framework to simultaneously address inexact supervision signals in both instance space and label space. Experimental results on five benchmark datasets demonstrate that DualG outperforms existing MIPL and partial label learning methods, validating its effectiveness and superiority. | 2026 | CLASH-CTTA: Class-Wise Shift-Aware Hierarchical Continual Test-Time AdaptationabstractThe domain shift between training and test data has emerged as a critical obstacle to the generalization of deep models. Continual Test-Time Adaptation (CTTA), which aims to leverage online test data stream to adapt to continuously evolving target distributions, has become a promising and practical solution to address real-world domain shift issues. Existing CTTA methods primarily rely on self-training frameworks based on output consistency and entropy-based loss functions, which often consider either the entire batch or reliable samples within the batch in isolation, failing to combine both of the advantages simultaneously. Inspired by fast and slow learning strategies in continual learning, we propose a fully source-free approach, dubbed CLAss-wise Shift-aware Hierarchical Continual Test-Time Adaptation (CLASH-CTTA). The adaptation process of CLASH-CTTA is carried out with a hierarchical updating strategy, where the test data stream promotes the slow learning of general representations, while the representative samples facilitate fast learning of domain-specific knowledge. The observation reveals that different classes exhibit varying sensitivities to different domains, leading to diverse discriminability across classes under domain shifts. Thus, a Class-wise Shift-aware Representative Set is maintained to provide representatives and mitigate the discrepancy. In addition, using Spearman's rank correlation as a novel perspective to examine the correctness of samples, we further filter representatives and align them to the class prototypes. Extensive experiments on three corruption domain shift datasets and one natural domain shift dataset demonstrate the superiority of our method compared with state-of-the-art methods, including in continual tasks, gradual tasks, and scenarios with diverse batch sizes. | 2026 | Twin Tensor Learning for Consistency and Inconsistency: A Unified Affinity Learning Framework for Multi-View ClusteringabstractDue to the efficiency of discovering the high-order correlations of multiple views, tensorized multi-view clustering (TMVC) has been extensively investigated and achieve impressive performance. However, previous TMVC studies merely emphasize on exploring the multi-view consistency, but rarely consider the cross-view inconsistency that may be caused by noise, corruptions or view-specific properties, rendering the abundant information contained in multiple features cannot be comprehensively detected. To this end, this paper proposes aTwin tensOrized affinity learning framewOrk for mulTi-view cluStering (TOOTS), which seamlessly integrates multi-view consistency and cross-view inconsistency into a unified framework. Specifically, the TOOTS model employs the self-representation mechanism to learn two sets of affinity matrices, which are reorganized into twin tensors (i.e., consistent tensor and diverse tensor). Meanwhile, tensor low-rank constraint and exclusive lasso with$\ell _{21}$regularization are imposed on consistent part and diverse part respectively, leading to the intra-view spatial structure and the inter-view inconsistency be exploited simultaneously. Furthermore, the multiple consistent factors are manipulated by a connectivity constraint and fused into a consensus graph with different weights, making the explicit clusters structural and the salient difference between views effectively leveraged. Substantial experimental results demonstrate that the proposed TOOTS model outperforms state-of-the-arts. Zhibin Gu, Songhe Feng

Addressing Multi-Label Learning with Partial Labels: From Sample Selection to Label SelectionabstractMulti-label Learning with Partial Labels (ML-PL) learns from training data, where each sample is annotated with part of positive labels while leaving the rest of positive labels unannotated. Existing methods mainly focus on extending multi-label losses to estimate unannotated labels, further inducing a missing-robust network. However, training with single network could lead to confirmation bias (i.e., the model tends to confirm its mistakes). To tackle this issue, we propose a novel learning paradigm termed Co-Label Selection (CLS), where two networks feed forward all data and cooperate in a co-training manner for critical label selection. Different from traditional co-training based methods that networks select confident samples for each other, we start from a new perspective that two networks are encouraged to remove false-negative labels while keep training samples reserved. Meanwhile, considering the extreme positive-negative label imbalance in ML-PL that leads the model to focus on negative labels, we enforce the model to concentrate on positive labels by abandoning non-informative negative labels to alleviate such issue. By shifting the cooperation strategy from "Sample Selection'' to "Label Selection'', CLS avoids directly dropping samples and reserves training data in most extent, thus enhancing the utilization of supervised signals and the generalization of the learning model. Empirical results performed on various multi-label datasets demonstrate that our CLS is significantly superior to other state-of-the-art methods. Gengyu Lyu, Bohang Sun, Songhe Feng

KOALA: Kernel Coupling and Element Imputation Induced Multi-View ClusteringabstractIncomplete Multi-View Clustering (IMVC) has made significant progress by optimally merging multiple pre-specified incomplete views. Most existing IMVC algorithms operate under the assumption that view alignment is known, but in practice, the coupling information between views may be absent, thereby limiting the practical applicability of these methods. Being aware of this, we propose a novel IMVC method named Kernel cOupling And eLement imputAtion induced Multi-View Clustering (KOALA), which sufficiently explores the nonlinear relationship among features and optimally processes a group of kernels with missing and unaligned elements to simultaneously resolve multi-view clustering problem under both uncoupled and incomplete scenarios. Specifically, we first introduce a cross-kernel alignment learning strategy to reconstruct the coupling relationships among multiple kernels, which effectively captures high-order nonlinear relationships among samples and enhances alignment accuracy. Additionally, a low-rank tensor constraint is imposed on the optimizable alignment kernel tensor, facilitating the effective imputation of missing kernel elements by leveraging consistency information across views. Subsequently, we develop an alternative optimization approach with promising convergence to solve the resultant optimization problem. Extensive experimental results on various multi-view datasets demonstrate that the KOALA method achieves remarkable clustering performance. Zhibin Gu, Jiazheng Yuan, Songhe Feng

| 2025 | AdaptCMVC: Robust Adaption to Incremental Views in Continual Multi-view ClusteringabstractMost Multi-view Clustering approaches assume that all views are available for clustering. However, this assumption is often unrealistic as views are incrementally accumulated over time, leading to a need for continual multi-view clustering (CMVC) methods. Current approaches to CMVC leverage late fusion-based approaches, where a new model is typically learned individually for each view to obtain the corresponding partition matrix, and then used to update a consensus matrix via a moving average. These approaches are prone to view-specific noise and struggle to adapt to large gaps between different views. To address these shortcomings, we reconsider CMVC from the perspective of domain adaptation and propose AdaptCMVC, which learns how to incrementally accumulate knowledge of new views as they become available and prevents catastrophic forgetting. Specifically, a self-training framework is introduced to extend the model to new views, particularly designed to be robust to view-specific noise. Further, to combat catastrophic forgetting, a structure alignment mechanism is proposed to enable the model to explore the global group structure across multiple views. Experiments on several multi-view benchmarks demonstrate the effectiveness of our proposed method on the CMVC task. The code is available at: AdaptCMVC. | 2025 | Leveraging MLLM Embeddings and Attribute Smoothing for Compositional Zero-Shot LearningabstractCompositional zero-shot learning (CZSL) aims to recognize novel compositions of attributes and objects learned from seen compositions. Previous works disentangle attributes and objects by extracting shared and exclusive parts between the image pair sharing the same attribute (object), as well as aligning them with pretrained word embeddings to improve unseen attribute-object recognition. Despite the significant achievements of existing efforts, they are hampered by three limitations: (1) The efficacy of disentanglement is compromised due to the influence of the background and the intricate entanglement of attributes with objects in the same parts. (2) Existing word embeddings fail to capture complex multimodal semantic information. (3) Overconfidence exhibited by existing models in seen compositions hinders their generalization to novel compositions. Being aware of these, we propose a novel framework named multimodal large language model (MLLM) embeddings and attribute smoothing guided disentanglement for CZSL. First, we leverage feature adaptive aggregation modules to mitigate the impact of background, and utilize learnable condition masks to capture multi-granularity features for disentanglement. Moreover, the last hidden states of MLLM are employed as word embeddings for their superior representation capabilities. Furthermore, we propose attribute smoothing with auxiliary attributes generated by the large language model (LLM) for seen compositions to address the overconfidence challenge. Extensive experiments demonstrate that our method achieves state-of-the-art performance on three challenging datasets. | 2025 | Anchors Bring Stability and Efficiency: Fast Tensorial Multi-view Clustering on Shuffled DatasetsabstractTensorial Multi-view Clustering (TMC) methods have received significant attention due to their ability to capture the high-order correlation among different views. Despite their notable progress, two issues persist: 1) Most TMC methods are highly reliant on prior structure information in sorted datasets, rendering them challenging to handle the shuffled case. 2) Extremely high computational complexity arising from tensor-related operations. To address these limitations, we propose a novel framework termed Anchors Bring Stability and Efficiency: Fast Tensorial Multi-view Clustering on Shuffled Case (SE-FTMC). SE-FTMC first learns a set of anchors and a unified corresponding matrix between anchors and samples, then the low-rank tensor learning is adopted in anchor space instead of sample space to avoid reliance on the prior information hidden in sorted samples and reduce the computational complexity. Finally, SE-FTMC passes the high-order correlations learned in the anchor space into the sample space through the corresponding matrix to improve the efficiency and stability of clustering. Furthermore, SE-FTMC is solved by an efficient algorithm with linear complexity. Extensive experiments on various datasets demonstrate the effectiveness and superiority of our SE-FTMC compared with state-of-the-art methods. | 2025 | TOMCAT: Test-time Comprehensive Knowledge Accumulation for Compositional Zero-Shot LearningabstractCompositional Zero-Shot Learning (CZSL) aims to recognize novel attribute-object compositions based on the knowledge learned from seen ones.
Existing methods suffer from performance degradation caused by the distribution shift of label space at test time, which stems from the inclusion of unseen compositions recombined from attributes and objects.
To overcome the challenge, we propose a novel approach that accumulates comprehensive knowledge in both textual and visual modalities from unsupervised data to update multimodal prototypes at test time. Building on this, we further design an adaptive update weight to control the degree of prototype adjustment, enabling the model to flexibly adapt to distribution shift during testing. Moreover, a dynamic priority queue is introduced that stores high-confidence images to acquire visual knowledge from historical images for inference. Considering the semantic consistency of multimodal knowledge, we align textual and visual prototypes by multimodal collaborative representation learning. Extensive experiments indicate that our approach achieves state-of-the-art performance on four benchmark datasets under both closed-world and open-world settings.

Anchors Crash Tensor: Efficient and Scalable Tensorial Multi-View Subspace ClusteringabstractTensorial Multi-view Clustering (TMC), a prominent approach in multi-view clustering, leverages low-rank tensor learning to capture high-order correlation among views for consistent clustering structure identification. Despite its promising performance, the TMC algorithms face three key challenges: 1). The severe computational burden makes it difficult for TMC methods to handle large-scale datasets. 2). Estimation bias problem caused by the convex surrogate of the tensor rank. 3). Lack of explicit balance of consistency and complementarity. Being aware of these, we propose a basic framework Efficient and Scalable Tensorial Multi-View Subspace Clustering (ESTMC) for large-scale multi-view clustering. ESTMC integrates anchor representation learning and non-convex function-based low-rank tensor learning with a Generalized Non-convex Tensor Rank (GNTR) into a unified objective function, which enhances the efficiency of the existing subspace-based TMC framework. Furthermore, a novel model ESTMC-C with the proposed Enhanced Tensor Rank (ETR), Consistent Geometric Regularization (CGR), and Tensorial Exclusive Regularization (TER) is extended to balance the learning of consistency and complementarity among views, delivering divisible representations for the clustering task. Efficient iterative optimization algorithms are designed to solve the proposed ESTMC and ESTMC-C, which enjoy time-economical complexity and exhibit theoretical convergence. Extensive experimental results on various datasets demonstrate the superiority of the proposed algorithms as compared to state-of-the-art methods. Jintian Ji, Songhe Feng

L-VSM: Label-Driven View-Specific Fusion for Multiview Multilabel ClassificationabstractIn the task of multiview multilabel (MVML) classification, each instance is represented by several heterogeneous features and associated with multiple semantic labels. Existing MVML methods mainly focus on leveraging the shared subspace to comprehensively explore multiview consensus information across different views, while it is still an open problem whether such shared subspace representation is effective to characterize all relevant labels when formulating a desired MVML model. In this article, we propose a novel label-driven view-specific fusion MVML method named L-VSM, which bypasses seeking for a shared subspace representation and instead directly encodes the feature representation of each individual view to contribute to the final multilabel classifier induction. Specifically, we first design a label-driven feature graph construction strategy and construct all instances under various feature representations into the corresponding feature graphs. Then, these view-specific feature graphs are integrated into a unified graph by linking the different feature representations within each instance. Afterward, we adopt a graph attention mechanism to aggregate and update all feature nodes on the unified graph to generate structural representations for each instance, where both intraview correlations and interview alignments are jointly encoded to discover the underlying consensuses and complementarities across different views. Moreover, to explore the widespread label correlations in multilabel learning (MLL), the transformer architecture is introduced to construct a dynamic semantic-aware label graph and accordingly generate structural semantic representations for each specific class. Finally, we derive an instance-label affinity score for each instance by averaging the affinity scores of its different feature representations with the multilabel soft margin loss. Extensive experiments on various MVML applications have verified that our proposed L-VSM has achieved superior performance against state-of-the-art methods. | 2024 | SURER: Structure-Adaptive Unified Graph Neural Network for Multi-View ClusteringabstractDeep Multi-view Graph Clustering (DMGC) aims to partition instances into different groups using the graph information extracted from multi-view data. The mainstream framework of DMGC methods applies graph neural networks to embed structure information into the view-specific representations and fuse them for the consensus representation. However, on one hand, we find that the graph learned in advance is not ideal for clustering as it is constructed by original multi-view data and localized connecting. On the other hand, most existing methods learn the consensus representation in a late fusion manner, which fails to propagate the structure relations across multiple views. Inspired by the observations, we propose a Structure-adaptive Unified gRaph nEural network for multi-view clusteRing (SURER), which can jointly learn a heterogeneous multi-view unified graph and robust graph neural networks for multi-view clustering. Specifically, we first design a graph structure learning module to refine the original view-specific attribute graphs, which removes false edges and discovers the potential connection. According to the view-specific refined attribute graphs, we integrate them into a unified heterogeneous graph by linking the representations of the same sample from different views. Furthermore, we use the unified heterogeneous graph as the input of the graph neural network to learn the consensus representation for each instance, effectively integrating complementary information from various views. Extensive experiments on diverse datasets demonstrate the superior effectiveness of our method compared to other state-of-the-art approaches. Jing Wang 0116, Songhe Feng, Gengyu Lyu, Jiazheng Yuan

Test-Time Domain Adaptation by Learning Domain-Aware Batch NormalizationabstractTest-time domain adaptation aims to adapt the model trained on source domains to unseen target domains using a few unlabeled images. Emerging research has shown that the label and domain information is separately embedded in the weight matrix and batch normalization (BN) layer. Previous works normally update the whole network naively without explicitly decoupling the knowledge between label and domain. As a result, it leads to knowledge interference and defective distribution adaptation. In this work, we propose to reduce such learning interference and elevate the domain knowledge learning by only manipulating the BN layer. However, the normalization step in BN is intrinsically unstable when the statistics are re-estimated from a few samples. We find that ambiguities can be greatly reduced when only updating the two affine parameters in BN while keeping the source domain statistics. To further enhance the domain knowledge extraction from unlabeled data, we construct an auxiliary branch with label-independent self-supervised learning (SSL) to provide supervision. Moreover, we propose a bi-level optimization based on meta-learning to enforce the alignment of two learning objectives of auxiliary and main branches. The goal is to use the auxiliary branch to adapt the domain and benefit main task for subsequent inference. Our method keeps the same computational cost at inference as the auxiliary branch can be thoroughly discarded after adaptation. Extensive experiments show that our method outperforms the prior works on five WILDS real-world domain shift datasets. Our method can also be integrated with methods with label-dependent optimization to further push the performance boundary. Our code is available at https://github.com/ynanwu/MABN. | 2024 | Low-Rank Kernel Tensor Learning for Incomplete Multi-View ClusteringabstractIncomplete Multiple Kernel Clustering algorithms, which aim to learn a common latent representation from pre-constructed incomplete multiple kernels from the original data, followed by k-means for clustering. They have attracted intensive attention due to their high computational efficiency. However, our observation reveals that the imputation of these approaches for each kernel ignores the influence of other incomplete kernels. In light of this, we present a novel method called Low-Rank Kernel Tensor Learning for Incomplete Multiple Views Clustering (LRKT-IMVC) to address the above issue. Specifically, LRKT-IMVC first introduces the concept of kernel tensor to explore the inter-view correlations, and then the low-rank kernel tensor constraint is used to further capture the consistency information to impute missing kernel elements, thereby improving the quality of clustering. Moreover, we carefully design an alternative optimization method with promising convergence to solve the resulting optimization problem. The proposed method is compared with recent advances in experiments with different missing ratios on seven well-known datasets, demonstrating its effectiveness and the advantages of the proposed interpolation method. Additionally, we introduce Gaussian error rank as a concise approximation of the true tensor rank, facilitating a comprehensive exploration of the diverse information encapsulated by various singular values in tensor data. Additionally, we integrate a hyper-anchor graph Laplacian manifold regularization into the tensor representation, allowing for the simultaneous utilization of inter-view high-order correlations and intra-view local correlations. | 2024 | Topology-Driven Multi-View Clustering via Tensorial Refined Sigmoid Rank MinimizationabstractBenefiting from the effective exploitation of the high-order correlations across multiple views, tensor-based multi-view clustering (TMVC) has garnered considerable attention in recent years. Nevertheless, prior TMVC techniques commonly involve assembling multiple view-specific spatial similarity graphs into a three-dimensional tensor, overlooking the intrinsic topological structure essential for precise clustering of data within a manifold. Additionally, mainstream techniques are constrained by equally shrinking all singular values to recover a low-rank tensor, limiting their capacity to distinguish significant variations among different singular values. In this investigation, we present an innovative TMVC framework termed toPology-driven multi-view clustering viA refined teNsorial sigmoiD rAnk minimization (PANDA ). Specifically, PANDA extracts view-specific topological structures from Euclidean graphs and intricately integrates them into a low-rank three-dimensional tensor, facilitating the concurrent utilization of intra-view topological connectivity and inter-view high-order correlations. Moreover, we develop a refined sigmoid function as the tighter surrogate to tensor rank, enabling the exploration of significant information of heterogeneous singular values. Meanwhile, the topological structures are merged into a unified structure with varying weights, associated with a connectivity constraint, empowering the significant divergence among views and the explicit cluster structure of the target graph are simultaneously leveraged. Extensive experiments demonstrate the superiority of PANDA, outperforming SOTA methods. Zhibin Gu, Songhe Feng

Tensorized Unaligned Multi-view Clustering with Multi-scale Representation LearningabstractThe Unaligned Multi-view Clustering (UMC) problem is currently receiving widespread attention, focusing on clustering unaligned multi-view data generated in real-world applications. Although some algorithms have emerged to address this issue, there still exist the following drawbacks: 1) The fully unknown correspondence of samples across views can significantly limit the exploration of consistent clustering structure. 2) The fixed representation space makes it difficult to mine the comprehensive information in the original data. 3) Unbiased tensor rank approximation is desired to capture the high-order correlation among different views. To address these issues, we proposed a novel UMC framework termed Tensorized Unaligned Multi-view Clustering with Multi-scale Representation Learning (TUMCR). Specifically, TUMCR designs a multi-scale representation learning and alignment framework, which constructs multi-scale representation spaces to comprehensively explore the unknown correspondence across views. Then, a tensorial multi-scale fusion module is proposed to fuse multi-scale representations and explore the high-order correlation hidden in different views, which utilizes the Enhanced Tensor Rank (ETR) to learn the low-rank structure. Furthermore, TUMCR is solved by an efficient algorithm with good convergence. Extensive experiments on different types of datasets demonstrate the effectiveness and superiority of our TUMCR compared with state-of-the-art methods. | 2024 | From Dictionary to Tensor: A Scalable Multi-View Subspace Clustering Framework with Triple Information EnhancementabstractWhile Tensor-based Multi-view Subspace Clustering (TMSC) has garnered significant attention for its capacity to effectively capture high-order correlations among multiple views, three notable limitations in current TMSC methods necessitate consideration: 1) high computational complexity and reliance on dictionary completeness resulting from using observed data as the dictionary, 2) inaccurate subspace representation stemming from the oversight of local geometric information and 3) under-penalization of noise-related singular values within tensor data caused by treating all singular values equally. To address these limitations, this paper presents a \textbf{S}calable TMSC framework with \textbf{T}riple inf\textbf{O}rmatio\textbf{N} \textbf{E}nhancement (\textbf{STONE}). Notably, an enhanced anchor dictionary learning mechanism has been utilized to recover the low-rank anchor structure, resulting in reduced computational complexity and increased resilience, especially in scenarios with inadequate dictionaries. Additionally, we introduce an anchor hypergraph Laplacian regularizer to preserve the inherent geometry of the data within the subspace representation. Simultaneously, an improved hyperbolic tangent function has been employed as a precise approximation for tensor rank, effectively capturing the significant variations in singular values. Extensive experimentation on a variety of datasets demonstrates that our approach surpasses SOTA methods in both effectiveness and efficiency. Zhibin Gu, Songhe Feng

Enhancing Point Cloud Sampling Quality with Dual-Branch Fusion NetworksabstractTask-oriented point cloud sampling methods have attracted considerable attention for their ability to adaptively select important point sets based on downstream tasks, achieving an excellent balance between data simplification and task performance. However, existing task-oriented sampling models, primarily based on single-branch designs, struggle to fully extract features from input point clouds that comprehensively reflect multi-dimensional key information, thus limiting their sampling performance. In this paper, we introduce a dual-branch sampling network, named DBS-NET, which conducts crucial point sampling from both the global and local importance perspectives separately before merging them, thereby preserving multi-dimensional key information of the input data during the sampling process. Qualitative and quantitative experimental results demonstrate the competitive performance of DBS-NET on the classification benchmark task. | 2024 | Bridging the Gap: Multi-Level Cross-Modality Joint Alignment for Visible-Infrared Person Re-IdentificationabstractVisible-Infrared person Re-IDentification (VI-ReID) is a challenging cross-modality image retrieval task that aims to match pedestrians’ images across visible and infrared cameras. To solve the modality gap, existing mainstream methods adopt a learning paradigm converting the image retrieval task into an image classification task with cross-entropy loss and auxiliary metric learning losses. These losses follow the strategy of adjusting the distribution of extracted embeddings to reduce the intra-class distance and increase the inter-class distance. However, such objectives do not precisely correspond to the final test setting of the retrieval task, resulting in a new gap at the optimization level. By rethinking these keys of VI-ReID, we propose a simple and effective method, the Multi-level Cross-modality Joint Alignment (MCJA), bridging both the modality and objective-level gap. For the former, we design the Visible-Infrared Modality Coordinator in the image space and propose the Modality Distribution Adapter in the feature space, effectively reducing modality discrepancy of the feature extraction process. For the latter, we introduce a new Cross-Modality Retrieval loss. It is the first work to constrain from the perspective of the ranking list in the VI-ReID, aligning with the goal of the testing stage. Moreover, to strengthen the robustness and cross-modality retrieval ability, we further introduce a Multi-Spectral Enhanced Ranking strategy for the testing phase. Based on the global feature only, our method outperforms existing methods by a large margin, achieving the remarkable rank-1 of 89.51% and mAP of 87.58% on the most challenging single-shot setting and all-search mode of the SYSU-MM01 dataset. | 2024 | Transformer Driven Matching Selection Mechanism for Multi-Label Image ClassificationabstractGraph Matching has recently emerged as an attractive technique applied to various computer vision tasks. Graph Matching based multi-label image classification, in particular, treats each image as a bag of instances and reformulates the classification task as an instance-label matching selection problem, achieving state-of-the-art results on diverse benchmarks. However, the generalization and scalability of such learned model cannot be well guaranteed due to its manually predetermined graph structure and high-dimension embedding of dense connections between instances and labels. To address these limitations, in this work, we propose a novel${T}$ransformer Driven${M}$atching${S}$election framework for Multi-Label Image${C}$lassification (C-TMS), where instance structural relationships, class-wise global dependencies, and the co-occurrence possibility of varying instance-label assignments are simultaneously taken into consideration in a unified and adaptive manner. Moreover, the parallelization capability of the Transformer enables efficient computation, making our model scalable to large-scale datasets. Specifically, we first represent instances and labels as nodes in the visual space and label space respectively, and then compute the hidden representation of each node in its individual space, by attending a self-attention strategy over its entire neighborhood. Subsequently, the cross-attention is adopted to excavate the correct assignments between instances and labels, and further interprets how classifying each label depends on the instances within an image and its interaction with other labels. Finally, an asymmetric focal loss is designed to optimize the instance-label correspondence, and read out image-level category confidences. Extensive experiments conducted on various multi-label image datasets demonstrate the superiority of our proposed method. Songhe Feng, Gongpei Zhao, Yi Jin 0001

OHD: An Online Category-Aware Framework for Learning With Noisy Labels Under Long-Tailed DistributionabstractRecently, many effective methods have emerged to address the robustness problem of Deep Neural Networks (DNNs) trained with noisy labels. However, existing work on learning with noisy labels (LNL) mainly focuses on balanced datasets, while real-world scenarios usually also exhibit a long-tailed distribution (LTD). In this paper, we propose an online category-aware approach to mitigate the impact of noisy labels and LTD on the robustness of DNNs. First, the category frequency of clean samples used to rebalance the feature space cannot be obtained directly in the presence of noisy samples. We design a novel category-aware Online Joint Distribution to dynamically estimate the category frequency of clean samples. Second, previous LNL methods were category-agnostic. These methods would easily be confused with noisy samples and tail categories’ samples under LTD. Based on this observation, we propose a Harmonizing Factor strategy to exploit more information from the category-aware online joint distribution. This strategy provides more accurate estimates of clean samples between noisy samples and samples with tail categories. Finally, we propose Dynamic Cost-sensitive Learning, which utilizes the loss and category frequency of the estimated clean samples to address both LNL and LTD. Compared to extensive state-of-the-art methods, our strategy consistently improves the generalization performance of DNNs on several synthetic datasets and two real-world datasets. | 2024 | Linkage-Based Object Re-Identification via Graph LearningabstractObject Re-identification (Re-ID), which includes person Re-ID and vehicle Re-ID, is one of the core technologies of the intelligent transportation system. Existing supervised Re-ID studies mainly focus on discriminative feature learning (e.g., attention-based methods) or metric learning (e.g., triplet-loss-based methods) to obtain more accurate matches between the probe object and the positive gallery. However, they both pay less attention to global structure information (GSI) buried in the overall datasets. In this paper, we go beyond the traditional methods that are either unaware of or locally perceiving to GSI, and consider exploring the structural relationships among all the object instances of a dataset via a graph. Specifically, we construct a graph across the entire dataset, where each object instance is treated as a node and edges are assigned with the help of a classic algorithm like KNN. Seeing that a binary edge label can be used to predict whether its associated nodes belong to the same identity, we naturally formulate the problem of Re-ID as a new link prediction problem. Inspired by the superior capacity of capturing structure information of graph convolutional networks (GCN), a GCN-based global structure embedded network (GSE-Net) is proposed to take the graph as input and output a set of linkage likelihoods. During testing, we perform the evaluation according to the node features or estimated linkage likelihood via a graph where nodes include query and gallery images. Extensive experiments demonstrate that our proposed method outperforms the state-of-the-arts on both person and vehicle Re-ID benchmarks. | 2024 | NOODLE: Joint Cross-View Discrepancy Discovery and High-Order Correlation Detection for Multi-View Subspace ClusteringabstractBenefiting from the effective exploration of the valuable topological pair-wise relationship of data points across multiple views, multi-view subspace clustering (MVSC) has received increasing attention in recent years. However, we observe that existing MVSC approaches still suffer from two limitations that need to be further improved to enhance the clustering effectiveness. Firstly, previous MVSC approaches mainly prioritize extracting multi-view consistency, often neglecting the cross-view discrepancy that may arise from noise, outliers, and view-inherent properties. Secondly, existing techniques are constrained by their reliance on pair-wise sample correlation and pair-wise view correlation, failing to capture the high-order correlations that are enclosed within multiple views. To address these issues, we propose a novel MVSC framework via joiNt crOss-view discrepancy discOvery anDhigh-order correLation dEtection (NOODLE), seeking an informative target subspace representation compatible across multiple features to facilitate the downstream clustering task. Specifically, we first exploit the self-representation mechanism to learn multiple view-specific affinity matrices, which are further decomposed into cohesive factors and incongruous factors to fit the multi-view consistency and discrepancy, respectively. Additionally, an explicit cross-view sparse regularization is applied to incoherent parts, ensuring the consistency and discrepancy to be precisely separated from the initial subspace representations. Meanwhile, the multiple cohesive parts are stacked into a three-dimensional tensor associated with a tensor-Singular Value Decomposition (t-SVD) based weighted tensor nuclear norm constraint, enabling effective detection of the high-order correlations implicit in multi-view data. | 2024 | Neighborhood Pattern Is Crucial for Graph Convolutional Networks Performing Node ClassificationabstractGraph convolutional networks (GCNs) are widely believed to perform well in the graph node classification task, and homophily assumption plays a core rule in the design of previous GCNs. However, some recent advances on this area have pointed out that homophily may not be a necessity for GCNs. For deeper analysis of the critical factor affecting the performance of GCNs, we first propose a metric, namely, neighborhood class consistency (NCC), to quantitatively characterize the neighborhood patterns of graph datasets. Experiments surprisingly illustrate that our NCC is a better indicator, in comparison to the widely used homophily metrics, to estimate GCN performance for node classification. Furthermore, we propose a topology augmentation graph convolutional network (TA-GCN) framework under the guidance of the NCC metric, which simultaneously learns an augmented graph topology with higher NCC score and a node classifier based on the augmented graph topology. Extensive experiments on six public benchmarks clearly show that the proposed TA-GCN derives ideal topology with higher NCC score given the original graph topology and raw features, and it achieves excellent performance for semi-supervised node classification in comparison to several state-of-the-art (SOTA) baseline algorithms. | 2023 | MetaZSCIL: A Meta-Learning Approach for Generalized Zero-Shot Class Incremental LearningabstractGeneralized zero-shot learning (GZSL) aims to recognize samples whose categories may not have been seen at training. Standard GZSL cannot handle dynamic addition of new seen and unseen classes. In order to address this limitation, some recent attempts have been made to develop continual GZSL methods. However, these methods require end-users to continuously collect and annotate numerous seen class samples, which is unrealistic and hampers the applicability in the real-world. Accordingly, in this paper, we propose a more practical and challenging setting named Generalized Zero-Shot Class Incremental Learning (CI-GZSL). Our setting aims to incrementally learn unseen classes without any training samples, while recognizing all classes previously encountered. We further propose a bi-level meta-learning based method called MetaZSCIL to directly optimize the network to learn how to incrementally learn. Specifically, we sample sequential tasks from seen classes during the offline training to simulate the incremental learning process. For each task, the model is learned using a meta-objective such that it is capable to perform fast adaptation without forgetting. Note that our optimization can be flexibly equipped with most existing generative methods to tackle CI-GZSL. This work introduces a feature generative framework that leverages visual feature distribution alignment to produce replayed samples of previously seen classes to reduce catastrophic forgetting. | 2023 | Anchor Structure Regularization Induced Multi-view Subspace Clustering via Enhanced Tensor Rank MinimizationabstractThe tensor-based multi-view subspace clustering algorithms have received widespread attention due to the powerful ability to capture high-order correlation across views. Although such algorithms have achieved remarkable success, they still suffer from three main issues: 1)The extremely high computational complexity makes tensor-based methods difficult to handle large-scale data sets. 2)The subspace-based methods usually ignore the local geometric structure of the original data. 3)The commonly used Tensor Nuclear Norm (TNN) treats different singular values equally and under-penalizes the noise components, resulting in a sub-optimal representation tensor. Being aware of these, we propose Anchor Structure Regularitation Induced Multi-view Subspace Clustering via Enhanced Tensor Rank Minimization (ASR-ETR). Specifically, an anchor-representation tensor is constructed by using the anchor representation strategy rather than the self-representation strategy to reduce the time complexity, and the local geometric structure in the learned anchor-representation tensor is enhanced by adopting the Anchor Structure Regularization (ASR). We further devise an Enhanced Tensor Rank (ETR), which is a tighter surrogate of the tensor rank to effectively capture the multi-view high-order correlation. An efficient iterative optimization algorithm is designed to solve the ASR-ETR, which is time-economical and enjoys favorable convergence. | 2023 | MetaGCD: Learning to Continually Learn in Generalized Category DiscoveryabstractIn this paper, we consider a real-world scenario where a model that is trained on pre-defined classes continually encounters unlabeled data that contains both known and novel classes. The goal is to continually discover novel classes while maintaining the performance in known classes. We name the setting Continual Generalized Category Discovery (C-GCD). Existing methods for novel class discovery cannot directly handle the C-GCD setting due to some unrealistic assumptions, such as the unlabeled data only containing novel classes. Furthermore, they fail to discover novel classes in a continual fashion. In this work, we lift all these assumptions and propose an approach, called MetaGCD, to learn how to incrementally discover with less forgetting. Our proposed method uses a meta-learning framework and leverages the offline labeled data to simulate the testing incremental learning process. A meta-objective is defined to revolve around two conflicting learning objectives to achieve novel class discovery without forgetting. Furthermore, a soft neighborhood-based contrastive network is proposed to discriminate uncorrelated images while attracting correlated images. | 2023 | Deep Partial Multi-Label Learning with Graph DisambiguationabstractIn partial multi-label learning (PML), each data example is equipped with a candidate label set, which consists of multiple ground-truth labels and other false-positive labels. Recently, graph-based methods, which demonstrate a good ability to estimate accurate confidence scores from candidate labels, have been prevalent to deal with PML problems. However, we observe that existing graph-based PML methods typically adopt linear multi-label classifiers and thus fail to achieve superior performance. In this work, we attempt to remove several obstacles for extending them to deep models and propose a novel deep Partial multi-Label model with grAph-disambIguatioN (PLAIN). Specifically, we introduce the instance-level and label-level similarities to recover label confidences as well as exploit label dependencies. At each training epoch, labels are propagated on the instance and label graphs to produce relatively accurate pseudo-labels; then, we train the deep model to fit the numerical labels. Moreover, we provide a careful analysis of the risk functions to guarantee the robustness of the proposed model. | 2023 | High-order Complementarity Induced Fast Multi-View Clustering with Enhanced Tensor Rank MinimizationabstractRecently, tensor-based multi-view clustering methods have achieved promising results, primarily benefited from their superior ability in exploring high-order consistent information among views. Despite significant progress, these methods inevitably suffer from several drawbacks: 1) Extremely high computational complexity restricts their feasibility for large-scale data sets. 2) Prevalently adopted tensor rank approximations (e.g., Tensor Nuclear Norm (TNN)) tend to under-penalize small singular values, resulting in noise residuals. 3) Tensor structure is rarely utilized for high-order complementarity investigation. In light of this, we propose High-order Complementarity Induced Fast Multi-View Clustering with Enhanced Tensor Rank Minimization (CFMVC-ETR). Specifically, two sets of representation matrices are learned from original multi-view data via the matrix factorization mechanism with a group of base matrices, which are further reconstructed into the consistent tensor and the complementary tensor, respectively. Subsequently, a novel Enhanced Tensor Rank is imposed on the consistent tensor, which is a tighter approximation of the tensor rank and is more noisy-robust to explore the high-order consistency. Meanwhile, a tensor-level constraint termed Tensorial Exclusive Regularization is proposed on the complementary tensor to enhance the view-specific feature and well capture the high-order complementarity. Moreover, we adopt a concatenation-fusion approach to integrate these two parts, deriving a discriminative unified embedding for the clustering task. We solve CFMVC-ETR by an efficient algorithm with good convergence. Extensive experiments on nine challenging data sets demonstrate the superiority of the proposed method. Jintian Ji, Songhe Feng

Triple-Granularity Contrastive Learning for Deep Multi-View Subspace ClusteringabstractMulti-view subspace clustering (MVSC), which leverages comprehensive information from multiple views to effectively reveal the intrinsic relationships among instances, has garnered significant research interest. However, previous MVSC research focuses on exploring the cross-view consistent information only in the instance representation hierarchy or affinity relationship hierarchy, which prevents a joint investigation of the multi-view consistency in multiple hierarchies. To this end, we propose a Triple-gRanularity contrastive learning framework for deep mUlti-view Subspace clusTering (TRUST), which benefits from the comprehensive discovery of valuable information from three hierarchies, including the instance, specific-affinity relationship, and consensus-affinity relationship. Specifically, we first use multiple view-specific autoencoders to extract noise-robust instance representations, which are then respectively input into the MLP model and self-representation model to obtain high-level instance representations and view-specific affinity matrices. Then, the instance and specific-affinity relationship contrastive regularization terms are separately imposed on the high-level instance representations and view specific-affinity matrices, ensuring the cross-view consistency can be found from the instance representations to the view-specific affinity matrices. Furthermore, multiple view-specific affinity matrices are fused into a consensus one associated with the consensus-affinity relationship contrastive constraint, which embeds the local structural relationship of high-level instance representations into the consensus affinity matrix. Extensive experiments on various datasets demonstrate that our method is more effective when compared with other state-of-art methods. Jing Wang 0116, Songhe Feng, Gengyu Lyu, Zhibin Gu

Enhancing Domain-Invariant Parts for Generalized Zero-Shot LearningabstractGeneralized Zero-Shot Learning (GZSL) aims to recognize unseen classes, which are not observable during training, with auxiliary semantic information, e.g., attributes. Attributes play an important role in GZSL due to their ability to provide rich semantic information and visual guidance. In this paper, we will review the characteristics of attributes. First, the visual appearance of the same attribute varies greatly between different classes, which leads to the projection domain shift problem and inaccurate attribute localization. Second, the predefined semantic prototypes are not able to faithfully represent the credible visual information of each sample, which leads to suboptimal visual-semantic alignment. Therefore, we propose a novel framework called Enhancing doMain-invariant Parts (EMP) to solve above issues. To be specific, we mitigate the projection domain shift problem by the feature disentanglement technology in domain generalization, which can disentangle the attribute-based visual features into domain-invariant and domain-specific parts. So that the model can pay more attention to the essential parts of attributes rather than using all the information learned from the seen classes to identify the unseen classes. Then we achieve better visual-semantic alignment by refining the predefined semantic prototypes with the extracted credible visual information from corresponding sample. To make the extracted visual information be more in line with the image content rather than overfitting the semantic prototype, we draw on the idea of self-paced learning to help the model learn attributes from easy to complex. Experimental results show that our method achieves a new state-of-the-art performance on three generalized zero-shot learning benchmarks. Songhe Feng

Ranking-Based Color Constancy With Limited Training SamplesabstractComputational color constancy is an important component of Image Signal Processors (ISP) for white balancing in many imaging devices. Recently, deep convolutional neural networks (CNN) have been introduced for color constancy. They achieve prominent performance improvements comparing with those statistics or shallow learning-based methods. However, the need for a large number of training samples, a high computational cost and a huge model size make CNN-based methods unsuitable for deployment on low-resource ISPs for real-time applications. In order to overcome these limitations and to achieve comparable performance to CNN-based methods, an efficient method is defined for selecting the optimal simple statistics-based method (SM) for each image. To this end, we propose a novel ranking-based color constancy method (RCC) that formulates the selection of the optimal SM method as a label ranking problem. RCC designs a specific ranking loss function, and uses a low rank constraint to control the model complexity and a grouped sparse constraint for feature selection. Finally, we apply the RCC model to predict the order of the candidate SM methods for a test image, and then estimate its illumination using the predicted optimal SM method (or fusing the results estimated by the top k SM methods). Comprehensive experiment results show that the proposed RCC outperforms nearly all the shallow learning-based methods and achieves comparable performance to (sometimes even better performance than) deep CNN-based methods with only 1/2000 of the model size and training time. RCC also shows good robustness to limited training samples and good generalization crossing cameras. Furthermore, to remove the dependence on the ground truth illumination, we extend RCC to obtain a novel ranking-based method without ground truth illumination (RCC_NO) that learns the ranking model using simple partial binary preference annotations provided by untrained annotators rather than experts. RCC_NO also achieves better performance than the SM methods and most shallow learning-based methods with low costs of sample collection and illumination measurement. | 2023 | Semantic-Aware Graph Matching Mechanism for Multi-Label Image RecognitionabstractMulti-label image recognition aims to predict a set of labels that present in an image. The key to deal with such problem is to mine the associations between image contents and labels, and further obtain the correct assignments between images and their labels. In this paper, we treat each image as a bag of instances, and formulate the task of multi-label image recognition as an instance-label matching selection problem. To model such problem, we propose an innovative Semantic-aware Graph Matching framework for Multi-Label image recognition (ML-SGM), in which Graph Matching mechanism is introduced owing to its good performance of excavating the instance and label relationship. The framework explicitly establishes category correlations and instance-label correspondences by modeling the relation among content-aware (instance) and semantic-aware (label) category representations, to facilitate multi-label image understanding and reduce the dependency of large amounts of training samples for each category. Specifically, we first construct an instance spatial graph and a label semantic graph respectively and then incorporate them into a constructed assignment graph by connecting each instance to all labels. Subsequently, the graph network block is adopted to aggregate and update all nodes and edges state on the assignment graph to form structured representations for each instance and label. Our network finally derives a prediction score for each instance-label correspondence and optimizes such correspondence with a weighted cross-entropy loss. Empirical results conducted on generic multi-label image recognition demonstrate the superiority of our proposed method. Moreover, the proposed method also shows advantages in multi-label recognition with partial labels and multi-label few-shot learning, as well as outperforms current state-of-the-art methods with a clear margin. The common strategy to deal with such a problem is disambiguation, that is, identifying the ground-truth labels from the given candidate labels. However, the existing PML approaches always focus on leveraging the instance relationship to disambiguate the given noisy label space, while the potentially useful information in label space is not effectively explored. Meanwhile, the existence of noise and outliers in training data also makes the disambiguation operation less reliable, which inevitably decreases the robustness of the learned model. In this article, we propose a prior label knowledge regularized self-representation PML approach, called PAKS, where the self-representation scheme and prior label knowledge are jointly incorporated into a unified framework. Specifically, we introduce a self-representation model with a low-rank constraint, which aims to learn the subspace representations of distinct instances and explore the high-order underlying correlation among different instances. Meanwhile, we incorporate prior label knowledge into the above self-representation model, where the prior label knowledge is regarded as the complement of features to obtain an accurate self-representation matrix. The core of PAKS is to take advantage of the data membership preference, which is derived from the prior label knowledge, to purify the discovered membership of the data and accordingly obtain more representative feature subspace for model induction. Enormous experiments on both synthetic and real-world datasets show that our proposed approach can achieve superior or comparable performance to state-of-the-art approaches. | 2023 | Redundant Label Learning via Subspace Representation and Global DisambiguationabstractRedundant Label Learning (RLL) aims at inducing a robust model from training data, where each example is associated with a set of candidate labels, among which some of them are incorrect. Most existing approaches deal with such problem by disambiguating the candidate labels first and then inducing the predictive model from the disambiguated data. However, these approaches only focus on disambiguation for each instance’ candidate label set, while the global label context tends to be ignored. Meanwhile, these approaches usually induce the objective model by directly utilizing the original feature information, which may lead to the model overfitting due to high-dimensional redundant features. To tackle the above issues, we propose a novel feature S ubspac E R epresentation and label G lobal Disambiguat IO n ( SERGIO ) approach, which improves the generalization ability of the learning system from the perspective of both feature space and label space. Specifically, we project the original high-dimensional feature space into a low-dimensional subspace, where the projection matrix is regularized with an orthogonality constraint to make the subspace more compact. Meanwhile, we introduce a label confidence matrix and constrain it with ℓ 1 -norm and trace-norm regularization simultaneously, which are utilized to explore global label correlations and further well in accordance with the nature of single-label classification and multi-label classification problem, respectively. Extensive experiments on both single-label and multi-label RLL datasets demonstrate that our proposed method achieves competitive performance against state-of-the-art approaches. | 2023 | Prior Knowledge Constrained Adaptive Graph Framework for Partial Label LearningabstractPartial label learning (PLL) aims to learn a robust multi-class classifier from the ambiguous data, where each instance is given with several candidate labels, among which only one label is real. Most existing methods usually cope with such problem by utilizing a feature similarity graph to conduct label disambiguation. However, these methods construct the feature graph by only employing original features, while the influences of latent outliers and the contributions of label space are regrettably ignored. To tackle these issues, in this article, we propose aPrior KnOwledge ConsTrainedAdaptiveGraph FramEwork (POTAGE) for partial label learning, which utilizes an adaptive graph fused with label information to accurately describe the instance relationship and guide the desired model training. Compared with the feature-induced fixed graph, the adaptive graph is deemed to be more robust and accurate to reveal the intrinsic manifold structure within the data, and the embedding label information is expected to effectively alleviate the label ambiguities and enlarge the gap of label confidences between two instances from different classes. Extensive experiments demonstrate that POTAGE achieves state-of-the-art performance. Gengyu Lyu, Songhe Feng, Shaokai Wang, Zhen Yang 0004

Individuality Meets Commonality: A Unified Graph Learning Framework for Multi-View ClusteringabstractMulti-view clustering, which aims at boosting the clustering performance by leveraging the individual information and the common information of multi-view data, has gained extensive consideration in recent years. However, most existing multi-view clustering algorithms either focus on extracting the multi-view individuality or emphasize on exploring the multi-view commonality, neither of which can fully utilize the comprehensive information from multiple views. To this end, we propose a novel algorithm named V iew-specific and C onsensus G raph A lignment (VCGA) for multi-view clustering, which simultaneously formulates the multi-view individuality and the multi-view commonality into a unified framework to effectively partition data points. To be specific, the VCGA model constructs the view-specific graphs and the shared graph from original multi-view data and hidden latent representation, respectively. Furthermore, the view-specific graphs of different views and the consensus graph are aligned into an informative target graph, which is employed as a crucial input to the standard spectral clustering method for clustering. | 2023 | ONION: Joint Unsupervised Feature Selection and Robust Subspace Extraction for Graph-based Multi-View ClusteringabstractGraph-based Multi-View Clustering (GMVC) has received extensive attention due to its ability to capture the neighborhood relationship among data points from diverse views. However, most existing approaches construct similarity graphs from the original multi-view data, the accuracy of which heavily and implicitly relies on the quality of the original multiple features. Moreover, previous methods either focus on mining the multi-view commonality or emphasize on exploring the multi-view individuality, making the rich information contained in multiple features cannot be effectively exploited. In this work, we design a novel GMVC framework via c O mmo N ality and I ndividuality disc O vering in late N t subspace ( ONION ), seeking for a robust and discriminative subspace representation compatible across multiple features for GMVC. To be specific, our method simultaneously formulates the unsupervised sparse feature selection and the robust subspace extraction, as well as the target graph learning in a unified optimization model, which can help the learning of the discriminative subspace representation and the target graph in a mutual reinforcement manner. Meanwhile, we manipulate the target graph by an explicit structural penalty, rendering the connected components in the graph directly reveal clusters. | 2023 | Structure Diversity-Induced Anchor Graph Fusion for Multi-View ClusteringabstractThe anchor graph structure has been widely used to speed up large-scale multi-view clustering and exhibited promising performance. How to effectively integrate the anchor graphs on multiple views to achieve enhanced clustering performance still remains a challenging task. Existing fusing strategies ignore the structure diversity among anchor graphs and restrict the anchor generation to be same on different views, which degenerates the representation ability of corresponding fused consensus graph. To overcome these drawbacks, we propose a novel structural fusion framework to integrate the multi-view anchor graphs for clustering. Different from traditional integration strategies, we merge the anchors and edges of all the view-specific anchor graphs into a single graph for the structural optimal graph learning. Benefiting from the structural fusion strategy, the anchor generation of each view is not forced to be same, which greatly improves the representation capability of the target structural optimal graph, since the anchors of each view capture the diverse structure of different views. By leveraging the potential structural consistency among each anchor graph, a connectivity constraint is imposed on the target graph to indicate clusters directly without any post-processing such as k -means in classical spectral clustering. Substantial experiments on real-world datasets are conducted to verify the superiority of the proposed method, as compared with the state-of-the-arts over the clustering performance and time expenditure. | 2023 | Distance-Preserving Embedding Adaptive Bipartite Graph Multi-View Learning with Application to Multi-Label ClassificationabstractGraph-based multi-view learning has attracted much attention due to the efficacy of fusing the information from different views. However, most of them exhibit high computational complexity. We propose an anchor-based bipartite graph embedding approach to accelerate the learning process. Specifically, different from existing anchor-based methods where anchors are obtained from key samples by clustering or weighted averaging strategies, in this article, the anchors are learned in a principled fashion which aims at constructing a distance-preserving embedding for each view from samples to their representations, whose elements are the weights of the edges linking corresponding samples and anchors. In addition, the consistency among different views can be explored by imposing a low-rank constraint on the concatenated embedding representations. We further design a concise yet effective feature collinearity guided feature selection scheme to learn tight multi-label classifiers. The objective function is optimized in an alternating optimization fashion. Both theoretical analysis and experimental results on different multi-label image datasets verify the effectiveness and efficiency of the proposed method. | 2023 | Beyond Word Embeddings: Heterogeneous Prior Knowledge Driven Multi-Label Image ClassificationabstractMulti-Label Image Classification (MLIC) is a fundamental yet challenging task which aims to recognize multiple labels from given images. The key to solve MLIC lies in how to accurately model the correlation between labels. Recent studies often adopt Graph Convolutional Network (GCN) to model label dependencies with word embeddings as prior knowledge. However, classical word embeddings typically contain redundant information due to the imperfect distributional hypothesis it relies on, which may degrade model generalizability. To tackle this problem, we propose a novel deep learning framework termedVisual-Semantic basedGraphConvolutionalNetwork (VSGCN), which alleviates the negative impact of redundant information by utilizing heterogeneous sources of prior knowledge. Specifically, we construct both visual prototype and semantic prototype for each label as heterogeneous prior label representations, which are further mapped to multi-label classifiers via two Multi-Head GCNs separately. The Multi-Head GCN mechanism proposed in this paper aims to guide the information propagation between prototypes for each label, which constructs multiple correlation graphs to simultaneously model the label correlation in different subspaces. Notably, we alleviate the negative influence of needless information by decreasing the inconsistency of predictions that come from visual space and semantic space. Extensive experiments conducted on various multi-label image datasets demonstrate the superiority of our proposed method. Songhe Feng, Gengyu Lyu, Tao Wang 0011, Congyan Lang

Clicking Matters: Towards Interactive Human ParsingabstractIn this work, we focus on Interactive Human Parsing (IHP), which aims to segment a human image into multiple human body parts with guidance from users’ interactions. This new task inherits the class-aware property of human parsing, which cannot be well solved by traditional interactive image segmentation approaches that are generally class-agnostic. To tackle this new task, we first exploit user clicks to identify different human parts in the given image. These clicks are subsequently transformed into semantic-aware localization maps, which are concatenated with the RGB image to form the input of the segmentation network and generate the initial parsing result. To enable the network to better perceive user's purpose during the correction process, we investigate several principal ways for the refinement, and reveal that random-sampling-based click augmentation is the best way for promoting the correction effectiveness. Furthermore, we also propose a semantic-perceiving loss (SP-loss) to augment the training, which can effectively exploit the semantic relationships of clicks for better optimization. To the best knowledge, this work is the first attempt to tackle the human parsing task under the interactive setting. Our IHP solution achieves 85% mIoU on the benchmark LIP, 80% mIoU on PASCAL-Person-Part and CIHP, 75% mIoU on Helen with only 1.95, 3.02, 2.84 and 1.09 clicks per class respectively. These results demonstrate that we can simply acquire high-quality human parsing masks with only a few human effort. We hope this work can motivate more researchers to develop data-efficient solutions to IHP in the future. Yutong Gao 0001, Liqian Liang, Congyan Lang, Songhe Feng, Yidong Li, Yunchao Wei

SSR-Net: A Spatial Structural Relation Network for Vehicle Re-identificationabstractVehicle re-identification (Re-ID) represents the task aiming to identify the same vehicle from images captured by different cameras. Recent years have seen various feature learning-based approaches merely focusing on feature representations including global features or local features to obtain more subtle details to identify highly similar vehicles. However, few such methods consider the spatial geometrical structure relationship among local regions or between the global and local regions. By contrast, in this study, we propose a Spatial Structural Relation Network (SSR-Net) that explores the above-mentioned two kinds of relations simultaneously to learn more discriminative features by modeling the spatial structure information and global context information. In this article, we propose to adopt a Graph Convolution Network (GCN), for modeling spatial structural relationships among characteristic features. The GCN model aggregating the local and global features is shown to be more discriminative and robust to several car image transformations. To improve the performance of our proposed network, we jointly combine the classification loss with metric learning loss. | 2022 | Beyond Shared Subspace: A View-Specific Fusion for Multi-View Multi-Label LearningabstractIn multi-view multi-label learning (MVML), each instance is described by several heterogeneous feature representations and associated with multiple valid labels simultaneously. Although diverse MVML methods have been proposed over the last decade, most previous studies focus on leveraging the shared subspace across different views to represent the multi-view consensus information, while it is still an open issue whether such shared subspace representation is necessary when formulating the desired MVML model. In this paper, we propose a DeepGCN based View-Specific MVML method (D-VSM) which can bypass seeking for the shared subspace representation, and instead directly encoding the feature representation of each individual view through the deep GCN to couple with the information derived from the other views. Specifically, we first construct all instances under different feature representations into the corresponding feature graphs respectively, and then integrate them into a unified graph by integrating the different feature representations of each instance. Afterwards, the graph attention mechanism is adopted to aggregate and update all nodes on the unified graph to form structural representation for each instance, where both intra-view correlations and inter-view alignments have been jointly encoded to discover the underlying semantic relations. Finally, we derive a label confidence score for each instance by averaging the label confidence of its different feature representations with the multi-label soft margin loss. Extensive experiments have demonstrated that our proposed method significantly outperforms state-of-the-art methods. Gengyu Lyu, Songhe Feng

Deep Graph Matching for Partial Label LearningabstractPartial Label Learning (PLL) aims to learn from training data where each instance is associated with a set of candidate labels, among which only one is correct. In this paper, we formulate the task of PLL problem as an ``instance-label'' matching selection problem, and propose a DeepGNN-based graph matching PLL approach to solve it. Specifically, we first construct all instances and labels as graph nodes into two different graphs respectively, and then integrate them into a unified matching graph by connecting each instance to its candidate labels. Afterwards, the graph attention mechanism is adopted to aggregate and update all nodes state on the instance graph to form structural representations for each instance. Finally, each candidate label is embedded into its corresponding instance and derives a matching affinity score for each instance-label correspondence with a progressive cross-entropy loss. | 2022 | Keypoint-Guided Modality-Invariant Discriminative Learning for Visible-Infrared Person Re-identificationabstractThe visible-infrared person re-identification (VI-ReID) task aims to retrieve images of pedestrians across cameras with different modalities. In this task, the major challenges arise from two aspects: intra-class variations among images of the same identity, and cross-modality discrepancies between visible and infrared images. Existing methods mainly focus on the latter, attempting to alleviate the impact of modality discrepancy, which ignore the former issue of identity variations and achieve limited discrimination. To address both aspects, we propose a Keypoint-guided Modality-invariant Discriminative Learning (KMDL) method, which can simultaneously adapt to intra-ID variations and bridge the cross-modality gap. By introducing human keypoints, our method makes further exploration in the image space, feature space and loss constraints to solve the above issues. Specifically, considering the modality discrepancy in original images, we first design a Hue Jitter Augmentation (HJA) strategy, introducing the hue disturbance to alleviate color dependence in the input stage. To obtain discriminative fine-grained representation for retrieval, we design the Global-Keypoint Graph Module (GKGM) in feature space, which can directly extract keypoint-aligned features and mine relationships within global and keypoint embeddings. Based on these semantic local embeddings, we further propose the Keypoint-Aware Center (KAC) loss that can effectively adjust the feature distribution under the supervision of ID and keypoint to learn discriminative representation for the matching. | 2022 | Task Adaptive Modeling for Few-shot Action RecognitionabstractCollecting action recognition datasets is time-consuming and labor-intensive. To solve this problem, a few-shot action recognition task that uses episode training to learn the model appears. However, due to the randomness of few-shot learning task sampling, there are great differences between each task, and the characteristics of classes are also diverse. Most of the current methods simply use the same processing flow for action recognition, ignoring the correlation between tasks. To solve this problem, we propose a task adaptive network for few-shot action recognition, which utilizes the dependency of support set and query set categories. Our method mainly includes two key points: Firstly, we add an attention module after the feature extraction module, which can use the attention mechanism to focus the obtained feature representation on more important local information. Secondly, we design a task adaptive module, which uses the support set samples to strengthen all samples of the current task. The module strengthens the common features within each class of the support set and expands the query set to highlight the differences between classes. We have conducted a large number of experiments on two commonly used action recognition data sets: HMDB51 and UCF101. The results of experiments show that our method has strong competitiveness and performs well in the field of few-shot action recognition. Yi Jin 0001, Songhe Feng, Yidong Li

Dense Attentive Feature Enhancement for Salient Object DetectionabstractAttention mechanisms have been proven highly effective for salient object detection. Most previous works utilize attention as a self-gated module to reweigh the feature maps at different levels independently. However, they are limited to certain-level guidance and could not satisfy the need of both accurately detecting intact objects and maintaining their detailed boundaries. In this paper, we build dense attention upon features from multiple levels simultaneously and propose a novel Dense Attentive Feature Enhancement (DAFE) module for efficient feature enhancement in saliency detection. DAFE stacks several attentional units and densely connects attentive feature output from current unit to its all subsequent units. This allows feature maps at deep units to absorb attentive information from shallow units, thus more discriminative information can be efficiently selected at the final output. Note that DAFE is plug and play, which can be effortlessly inserted into any saliency or video saliency models for their performance improvements. We further instantiate a highly effective Dense Attentive Feature Enhancement Network (DAFE-Net) for accurate salient object detection. DAFE-Net constructs DAFE over the aggregation feature that contains both semantics and saliency details, the entire salient objects and their boundaries can be well retained through dense attentions. Extensive experiments demonstrate that the proposed DAFE module is highly effective, and the DAFE-Net performs favorably compared with state-of-the-art approaches. | 2022 | A Self-Paced Regularization Framework for Partial-Label LearningabstractPartial-label learning (PLL) aims to solve the problem where each training instance is associated with a set of candidate labels, one of which is the correct label. Most PLL algorithms try to disambiguate the candidate label set, by either simply treating each candidate label equally or iteratively identifying the true label. Nonetheless, existing algorithms usually treat all labels and instances equally, and the complexities of both labels and instances are not taken into consideration during the learning stage. Inspired by the successful application of a self-paced learning strategy in the machine-learning field, we integrate the self-paced regime into the PLL framework and propose a novel self-paced PLL (SP-PLL) algorithm, which could control the learning process to alleviate the problem by ranking the priorities of the training examples together with their candidate labels during each learning iteration. | 2022 | Weakly Supervised Video Object Segmentation via Dual-attention Cross-branch FusionabstractRecently, concerning the challenge of collecting large-scale explicitly annotated videos, weakly supervised video object segmentation (WSVOS) using video tags has attracted much attention. Existing WSVOS approaches follow a general pipeline including two phases, i.e., a pseudo masks generation phase and a refinement phase. To explore the intrinsic property and correlation buried in the video frames, most of them focus on the later phase by introducing optical flow as temporal information to provide more supervision. However, these optical flow-based studies are greatly affected by illumination and distortion and lack consideration of the discriminative capacity of multi-level deep features. In this article, with the goal of capturing more effective temporal information and investigating a temporal information fusion strategy accordingly, we propose a unified WSVOS model by adopting a two-branch architecture with a multi-level cross-branch fusion strategy, named as dual-attention cross-branch fusion network (DACF-Net). Concretely, the two branches of DACF-Net, i.e., a temporal prediction subnetwork (TPN) and a spatial segmentation subnetwork (SSN), are used for extracting temporal information and generating predicted segmentation masks, respectively. To perform the cross-branch fusion between TPN and SSN, we propose a dual-attention fusion module that can be plugged into the SSN flexibly. We also pose a cross-frame coherence loss (CFCL) to achieve smooth segmentation results by exploiting the coherence of masks produced by TPN and SSN. Extensive experiments demonstrate the effectiveness of proposed approach compared with the state-of-the-arts on two challenging datasets, i.e., Davis-2016 and YouTube-Objects. | 2022 | Global-Local Label Correlation for Partial Multi-Label LearningabstractPartial Multi-label Learning (PML) addresses the scenario where each instance is assigned with multiple candidate labels, while only a subset of the labels are relevant. This task is very challenging because the training procedure can be misguided by the noisy (irrelevant) labels. Exploiting label correlations is useful for partial multi-label learning. However, the existing PML methods often ignore to explicitly and sufficiently leverage the label correlation information for handling the noisy labels. To this end, in this paper, we propose a novelGlobal-Local Label Correlation (GLC) approach for partial multi-label learning. On one hand, we introduce a label coefficient matrix to explicitly exploit the global structure information of labels from multiple subspaces. On the other hand, we present a new label manifold regularizer to capture the local label correlations to further improve the performance of our method. By jointly taking advantage of the global and local label correlations, our proposed approach achieves superior performance on both the synthetic and real-world data sets from diverse domains. | 2022 | Seeing Crucial Parts: Vehicle Model Verification via a Discriminative Representation ModelabstractWidely used surveillance cameras have promoted large amounts of street scene data, which contains one important but long-neglected object: the vehicle. Here we focus on the challenging problem of vehicle model verification. Most previous works usually employ global features (e.g., fully connected features) to further perform vehicle-level deep metric learning (e.g., triplet-based network). However, we argue that it is noteworthy to investigate the distinctiveness of local features and consider vehicle-part-level metric learning by reducing the intra-class variance as much as possible. In this article, we introduce a simple yet powerful deep model—the enforced intra-class alignment network (EIA-Net)—which can learn a more discriminative image representation by localizing key vehicle parts and jointly incorporating two distance metrics: vehicle-level embedding and vehicle-part-sensitive embedding. For learning features, we propose an effective feature extraction module that is composed of two components: the regional proposal network (RPN)-based network and part-based CNN. The RPN is used to define key vehicle regions and aggregate local features on these regions, whereas part-based CNN offers supplementary global features for the RPN-based network. The fusion features learned by feature extraction module are cast into the deep metric learning module. Especially, we derived an enforced intra-class alignment loss by re-utilizing key vehicle part information to enhance reducing intra-class variance. Furthermore, we modify the coupled cluster loss to model the vehicle-level embedding by enlarging the inter-class variance while shortening intra-class variance. Extensive experiments over benchmark datasets VehicleID and CompCars have shown that the proposed EIA-Net significantly outperforms the state-of-the-art approaches for vehicle model verification. Furthermore, we also conduct comprehensive experiments on vehicle re-identification datasets (i.e., VehicleID and VeRi776) to validate the generalization ability effectiveness of our proposed method. | 2021 | GM-MLIC: Graph Matching based Multi-Label Image ClassificationabstractMulti-Label Image Classification (MLIC) aims to predict a set of labels that present in an image. The key to deal with such problem is to mine the associations between image contents and labels, and further obtain the correct assignments between images and their labels. In this paper, we treat each image as a bag of instances, and reformulate the task of MLIC as a instance-label matching selection problem. To model such problem, we propose a novel deep learning framework named Graph Matching based Multi-Label Image Classification (GM-MLIC), where Graph Matching (GM) scheme is introduced owing to its excellent capability of excavating the instance and label relationship. Specifically, we first construct an instance spatial graph and a label semantic graph respectively, and then incorporate them into a constructed assignment graph by connecting each instance to all labels. Subsequently, the graph network block is adopted to aggregate and update all nodes and edges state on the assignment graph to form structured representations for each instance and label. Our network finally derives a prediction score for each instance-label correspondence and optimizes such correspondence with a weighted cross-entropy loss. | 2021 | L4Net: An anchor-free generic object detector with attention mechanism for autonomous drivingabstractAbstract Generic object detection is a crucial task for autonomous driving. To devise a safe and efficient object detector, the following aspects are required to be considered: high accuracy, real‐time inference speed and small model size. Herein, a simple yet effective anchor‐free object detector named L4Net is proposed, which incorporates a keypoint detection backbone and a co‐attention scheme into a unified framework, and achieves lower computation cost with higher detection accuracy than prior art across a wide spectrum of resource constrains. Specifically, the backbone utilizes M ulti‐scale R eceptive‐fields E nhancement module (MRE) to capture context‐wise information, where the features of object scale and shape invariance are simultaneously considered. The co‐attention scheme integrates the strength of both C lass‐agnostic A ttention (CA) and S emantic A ttention (SA), and explores the valuable features from low‐level to high‐level to generate more accurate prediction boxes. Compared with previous feature fusion strategy, multi‐scale features are selectively integrated by fully exploiting the different characteristics of low‐level and high‐level features, which leads to a small model size and faster inference speed. Extensive experiments on four well‐known datasets demonstrate the effectiveness of our method. For instance, L4Net achieves 71.68% mAP on KITTI test set, with 13.7 M model size at the speed of 149 FPS on NVIDIA TX and 30.7 FPS on Qualcomm‐based device, respectively, which is 4 x smaller and 2 x faster than baseline model. | 2021 | Fine-Grained Facial Expression Recognition in the WildabstractOver the past decades, researches on facial expression recognition have been restricted within six basic expressions (anger, fear, disgust, happiness, sadness and surprise). However, these six words can not fully describe the richness and diversity of human beings' emotions. To enhance the recognitive capabilities for computers, in this paper, we focus on fine-grained facial expression recognition in the wild and build a brand new benchmark FG-Emotions to push the research frontiers on this topic, which extends the original six classes to more elaborate thirty-three classes. Our FG-Emotions contains 10,371 images and 1,491 video clips annotated with corresponding fine-grained facial expression categories and landmarks. FG-Emotions also provides several features (e.g., LBP features and dense trajectories features) to facilitate related research. Moreover, on top of FG-Emotions, we propose a new end-to-end Multi-Scale Action Unit (AU)-based Network (MSAU-Net) for facial expression recognition with image which learns a more powerful facial representation by directly focusing on locating facial action units and utilizing “zoom in” operation to aggregate distinctive local features. As for recognition with video, we further extend the MSAU-Net to a two-stream model (TMSAU-Net) by adding a module with attention mechanism and a temporal stream branch to jointly learn spatial and temporal features. (T)MSAU-Net consistently outperforms existing state-of-the-art solutions on our FG-Emotions and several other datasets, and serves as a strong baseline to drive the future research towards fine-grained facial expression recognition in the wild. The existing semantic image synthesis methods only consider the global information provided by the semantic segmentation mask, such as class label, global layout, and location, so the generative models cannot capture the rich local fine-grained information of the images (e.g., object structure, contour, and texture). To address this issue, we adopt a multi-scale feature fusion algorithm to refine the generated images by learning the fine-grained information of the local objects. We propose OA-GAN, a novel object-attention generative adversarial network that allows attention-driven, multi-fusion refinement for fine-grained semantic image synthesis. Specifically, the proposed model first generates multi-scale global image features and local object features, respectively, then the local object features are fused into the global image features to improve the correlation between the local and the global. In the process of feature fusion, the global image features and the local object features are fused through the channel-spatial-wise fusion block to learn ‘what’ and ‘where’ to attend in the channel and spatial axes, respectively. The fused features are used to construct correlation filters to obtain feature response maps to determine the locations, contours, and textures of the objects. Extensive quantitative and qualitative experiments on COCO-Stuff, ADE20K and Cityscapes datasets demonstrate that our OA-GAN significantly outperforms the state-of-the-art methods. | 2021 | GM-PLL: Graph Matching Based Partial Label LearningabstractPartial Label Learning (PLL) aims to learn from the data where each training example is associated with a set of candidate labels, among which only one is correct. The key to deal with such problem is to disambiguate the candidate label sets and obtain the correct assignments between instances and their candidate labels. In this paper, we interpret such assignments as instance-to-label matchings, and reformulate the task of PLL as a matching selection problem. To model such problem, we propose a novel Graph Matching based Partial Label Learning (GM-PLL) framework, where Graph Matching (GM) scheme is incorporated owing to its excellent capability of exploiting the instance and label relationship. Meanwhile, since conventional one-to-one GM algorithm does not satisfy the constraint of PLL problem that multiple instances may correspond to the same label, we extend a traditional one-to-one probabilistic matching algorithm to the many-to-one constraint, and make the proposed framework accommodate to the PLL problem. Moreover, we also propose a relaxed matching prediction model, which can improve the prediction accuracy via GM strategy. Extensive experiments on both artificial and real-world data sets demonstrate that the proposed method can achieve superior or comparable performance against the state-of-the-art methods. | 2020 | Attentive Generative Adversarial Network To Bridge Multi-Domain Gap For Image SynthesisabstractDespite the significant progress on text-to-image synthesis, automatically generating realistic images remains a challenging task since the location and specific shape of object are not given in the text descriptions. To address these problems, we propose a novel attentive generative adversarial network with contextual loss (AGAN-CL) algorithm. More specifically, the generative network consists of two sub-networks: a contextual network for generating image contours, and a cycle transformation autoencoder for converting contours to realistic images. Our core idea is the injection of image contours into the generative network, which is the most critical part of our network, since it will guide the whole generative network to focus on object regions. In addition, we also apply contextual loss and cycle-consistent loss to bridge multi-domain gap. Comprehensive results on several challenging datasets demonstrate the advantage of the proposed method over the leading approaches, regarding both visual fidelity and alignment with input descriptions. | 2020 | Partial Multi-Label Learning via Multi-Subspace RepresentationabstractPartial Multi-Label Learning (PML) aims to learn from the training data where each instance is associated with a set of candidate labels, among which only a part of them are relevant. Existing PML methods mainly focus on label disambiguation, while they lack the consideration of noise in the feature space. To tackle the problem, we propose a novel framework named partial multi-label learning via MUlti-SubspacE Representation (MUSER), where the redundant labels together with noisy features are jointly taken into consideration during the training process. Specifically, we first decompose the original label space into a latent label subspace and a label correlation matrix to reduce the negative effects of redundant labels, then we utilize the correlations among features to project the original noisy feature space to a feature subspace to resist the noisy feature information. Afterwards, we introduce a graph Laplacian regularization to constrain the label subspace to keep intrinsic structure among features and impose an orthogonality constraint on the correlations among features to guarantee discriminability of the feature subspace. Extensive experiments conducted on various datasets demonstrate the superiority of our proposed method. Gengyu Lyu, Songhe Feng

Partial Multi-Label Learning via Probabilistic Graph Matching MechanismabstractPartial Multi-Label learning (PML) learns from the ambiguous data where each instance is associated with a candidate label set, where only a part is correct. The key to solve such problem is to disambiguate the candidate label sets and identify the correct assignments between instances and their ground-truth labels. In this paper, we interpret such assignments as instance-to-label matchings, and formulate the task of PML as a matching selection problem. To model such problem, we propose a novel grapH mAtching based partial muLti-label lEarning (HALE) framework, where Graph Matching scheme is incorporated owing to its good performance of exploiting the instance and label relationship. Meanwhile, since conventional one-to-one graph matching algorithm does not satisfy the constraint of PML problem that multiple instances may correspond to multiple labels, we extend the traditional probabilistic graph matching algorithm from one-to-one constraint to many-to-many constraint, and make the proposed framework to accommodate to the PML problem. Moreover, to improve the performance of predictive model, both the minimum error reconstruction and k-nearest-neighbor weight voting scheme are employed to assign more accurate labels for unseen instances. | 2020 | Subgraph and object context-masked network for scene graph generationabstractScene graph generation is to recognise objects and their semantic relationships in an image and can help computers understand visual scene. To improve relationship prediction, geometry information is essential and usually incorporated into relationship features. Existing methods use coordinates of objects to encode their spatial layout. However, in this way, they neglect the context of objects. In this study, to take full use of spatial knowledge efficiently, the authors propose a novel subgraph and object context‐masked network (SOCNet) consisting of spatial mask relation inference (SMRI) and hierarchical message passing (HMP) modules to address the scene graph generation task. In particular, to take advantage of spatial knowledge, SMRI masks partial context of object features depending on their spatial layout of objects and corresponding subgraph to facilitate their relationship recognition. To refine the features of objects and subgraphs, they also propose HMP that passes highly correlated messages from both microcosmic and macroscopic aspects through a triple‐path structure including subgraph–subgraph, object–object, and subgraph–object paths. Finally, statistical co‐occurrence probability is used to regularise relationship prediction. SOCNet integrates HMP and SMRI into a unified network, and comprehensive experiments on visual relationship detection and visual genome datasets indicate that SOCNet outperforms several state‐of‐the‐art methods on two common tasks. | 2020 | HERA: Partial Label Learning by Combining Heterogeneous Loss with Sparse and Low-Rank RegularizationabstractPartial label learning (PLL) aims to learn from the data where each training instance is associated with a set of candidate labels, among which only one is correct. Most existing methods deal with this type of problem by either treating each candidate label equally or identifying the ground-truth label iteratively. In this article, we propose a novel PLL approach named HERA, which simultaneously incorporates the HeterogEneous Loss and the SpaRse and Low-rAnk procedure to estimate the labeling confidence for each instance while training the desired model. Specifically, the heterogeneous loss integrates the strengths of both the pairwise ranking loss and the pointwise reconstruction loss to provide informative label ranking and reconstruction information for label identification, whereas the embedded sparse and low-rank scheme constrains the sparsity of ground-truth label matrix and the low rank of noise label matrix to explore the global label relevance among the whole training data, for improving the learning model. Comprehensive ablation study demonstrates the effectiveness of our employed heterogeneous loss, and extensive experiments on both artificial and real-world datasets demonstrate that our method achieves superior or comparable performance against state-of-the-art methods. | 2020 | End-to-End Text-to-Image Synthesis with Spatial ConstrainsabstractAlthough the performance of automatically generating high-resolution realistic images from text descriptions has been significantly boosted, many challenging issues in image synthesis have not been fully investigated, due to shapes variations, viewpoint changes, pose changes, and the relations of multiple objects. In this article, we propose a novel end-to-end approach for text-to-image synthesis with spatial constraints by mining object spatial location and shape information. Instead of learning a hierarchical mapping from text to image, our algorithm directly generates multi-object fine-grained images through the guidance of the generated semantic layouts. By fusing text semantic and spatial information into a synthesis module and jointly fine-tuning them with multi-scale semantic layouts generated, the proposed networks show impressive performance in text-to-image synthesis for complex scenes. We evaluate our method both on single-object CUB dataset and multi-object MS-COCO dataset. Comprehensive experimental results demonstrate that our method significantly outperforms the state-of-the-art approaches consistently across different evaluation metrics. | 2019 | Partial Multi-Label Learning by Low-Rank and Sparse DecompositionabstractMulti-Label Learning (MLL) aims to learn from the training data where each example is represented by a single instance while associated with a set of candidate labels. Most existing MLL methods are typically designed to handle the problem of missing labels. However, in many real-world scenarios, the labeling information for multi-label data is always redundant , which can not be solved by classical MLL methods, thus a novel Partial Multi-label Learning (PML) framework is proposed to cope with such problem, i.e. removing the the noisy labels from the multi-label sets. In this paper, in order to further improve the denoising capability of PML framework, we utilize the low-rank and sparse decomposition scheme and propose a novel Partial Multi-label Learning by Low-Rank and Sparse decomposition (PML-LRS) approach. Specifically, we first reformulate the observed label set into a label matrix, and then decompose it into a groundtruth label matrix and an irrelevant label matrix, where the former is constrained to be low rank and the latter is assumed to be sparse. Next, we utilize the feature mapping matrix to explore the label correlations and meanwhile constrain the feature mapping matrix to be low rank to prevent the proposed method from being overfitting. Finally, we obtain the ground-truth labels via minimizing the label loss, where the Augmented Lagrange Multiplier (ALM) algorithm is incorporated to solve the optimization problem. Enormous experimental results demonstrate that PML-LRS can achieve superior or competitive performance against other state-of-the-art methods. Songhe Feng, Tao Wang 0011, Congyan Lang, Yi Jin 0001

| 2019 | Deformable Surface Tracking by Graph MatchingabstractThis paper addresses the problem of deformable surface tracking from monocular images. Specifically, we propose a graph-based approach that effectively explores the structure information of the surface to enhance tracking performance. Our approach solves simultaneously for feature correspondence, outlier rejection and shape reconstruction by optimizing a single objective function, which is defined by means of pairwise projection errors between graph structures instead of unary projection errors between matched points. Furthermore, an efficient matching algorithm is developed based on soft matching relaxation. For evaluation, our approach is extensively compared to state-of-the-art algorithms on a standard dataset of occluded surfaces, as well as a newly compiled dataset of different surfaces with rich, weak or repetitive texture. Experimental results reveal that our approach achieves robust tracking results for surfaces with different types of texture, and outperforms other algorithms in both accuracy and efficiency. | 2019 | Co-saliency Detection with Graph MatchingabstractRecently, co-saliency detection, which aims to automatically discover common and salient objects appeared in several relevant images, has attracted increased interest in the computer vision community. In this article, we present a novel graph-matching based model for co-saliency detection in image pairs. A solution of graph matching is proposed to integrate the visual appearance, saliency coherence, and spatial structural continuity for detecting co-saliency collaboratively. Since the saliency and the visual similarity have been seamlessly integrated, such a joint inference schema is able to produce more accurate and reliable results. More concretely, the proposed model first computes the intra-saliency for each image by aggregating multiple saliency cues. The common and salient regions across multiple images are thus discovered via a graph matching procedure. Then, a graph reconstruction scheme is proposed to refine the intra-saliency iteratively. Compared to existing co-saliency detection methods that only utilize visual appearance cues, our proposed model can effectively exploit both visual appearance and structure information to better guide co-saliency detection. Extensive experiments on several challenging image pair databases demonstrate that our model outperforms state-of-the-art baselines significantly. | 2018 | Constrained Confidence Matching for Planar Object TrackingabstractTracking planar objects has a wide range of applications in robotics. Conventional template tracking algorithms, however, often fail to observe fast object motion or drift significantly after a period of time, due to drastic object appearance change. To address such challenges, we propose a novel constrained confidence matching algorithm for motion estimation and a robust Kalman filter for template updating. Integrated with an accurate occlusion detector, our approach achieves accurate motion estimation in presence of partial occlusion, by excluding occluded pixels from computation of motion parameters. Furthermore, the proposed Kalman filter employs a novel control-input model to handle the object appearance change, which brings our tracker high robustness against sudden illumination change and heavy motion blur. For evaluation, we compare the proposed tracker with several state-of-the-art planar object trackers on two public benchmark datasets. Experimental results show that our algorithm achieves robust tracking results against various environmental variations, and outperforms baseline algorithms remarkably on both datasets. | 2018 | Graph Matching with Adaptive and Branching Path FollowingabstractGraph matching aims at establishing correspondences between graph elements, and is widely used in many computer vision tasks. Among recently proposed graph matching algorithms, those utilizing the path following strategy have attracted special research attentions due to their exhibition of state-of-the-art performances. However, the paths computed in these algorithms often contain singular points, which could hurt the matching performance if not dealt properly. To deal with this issue, we propose a novel path following strategy, named branching path following (BPF), to improve graph matching accuracy. In particular, we first propose a singular point detector by solving a KKT system, and then design a branch switching method to seek for better paths at singular points. Moreover, to reduce the computational burden of the BPF strategy, an adaptive path estimation (APE) strategy is integrated into BPF to accelerate the convergence of searching along each path. A new graph matching algorithm named ABPF-G is developed by applying APE and BPF to a recently proposed path following algorithm named GNCCP (Liu & Qiao 2014). Experimental results reveal how our approach consistently outperforms state-of-the-art algorithms for graph matching on five public benchmark datasets. | 2017 | Robust Object Tracking Based on Temporal and Spatial Deep NetworksabstractRecently deep neural networks have been widely employed to deal with the visual tracking problem. In this work, we present a new deep architecture which incorporates the temporal and spatial information to boost the tracking performance. Our deep architecture contains three networks, a Feature Net, a Temporal Net, and a Spatial Net. The Feature Net extracts general feature representations of the target. With these feature representations, the Temporal Net encodes the trajectory of the target and directly learns temporal correspondences to estimate the object state from a global perspective. Based on the learning results of the Temporal Net, the Spatial Net further refines the object tracking state using local spatial object information. Extensive experiments on four of the largest tracking benchmarks, including VOT2014, VOT2016, OTB50, and OTB100, demonstrate competing performance of the proposed tracker over a number of state-of-the-art algorithms. | 2017 | Human Facial Age Estimation by Cost-Sensitive Label Ranking and Trace Norm RegularizationabstractHuman facial age estimation has attracted much attention due to its potential applications in forensics, security, and biometrics. In contrast to existing approaches that cast facial age estimation as either a multiclass classification or regression problem, in this work, we propose a novel approach that combines the strength of cost-sensitive label ranking methods with the power of low-rank matrix recovery theories. Instead of having to make a binary decision for each age label, our approach ranks age labels in a descending order in terms of their predicted relevance to the given facial image. In addition, the proposed approach aggregates the linear prediction functions for different ages into a matrix, and introduces the matrix trace norm regularization to explicitly capture the correlations among different age labels and control the model complexity as well. Furthermore, motivated by nonlinear generalization performance of kernel methods, we extend the trace norm regularization from a finite dimensional space to an infinite dimensional space. We also provide theoretical analysis on the efficiency of the proposed kernelized trace normalization, which guarantees the feasibility of the proposed method for solving large-scale prediction problems. | 2016 | Dual Low-Rank Pursuit: Learning Salient Features for Saliency DetectionabstractSaliency detection is an important procedure for machines to understand visual world as humans do. In this paper, we consider a specific saliency detection problem of predicting human eye fixations when they freely view natural images, and propose a novel dual low-rank pursuit (DLRP) method. DLRP learns saliency-aware feature transformations by utilizing available supervision information and constructs discriminative bases for effectively detecting human fixation points under the popular low-rank and sparsity-pursuit framework. Benefiting from the embedded high-level information in the supervised learning process, DLRP is able to predict fixations accurately without performing the expensive object segmentation as in the previous works. Comprehensive experiments clearly show the superiority of the proposed DLRP method over the established state-of-the-art methods. We also empirically demonstrate that DLRP provides stronger generalization performance across different data sets and inherits the advantages of both the bottom-up- and top-down-based saliency detection methods. | 2015 | Learning to Rank Image Tags With Limited Training ExamplesabstractWith an increasing number of images that are available in social media, image annotation has emerged as an important research topic due to its application in image matching and retrieval. Most studies cast image annotation into a multilabel classification problem. The main shortcoming of this approach is that it requires a large number of training images with clean and complete annotations in order to learn a reliable model for tag prediction. We address this limitation by developing a novel approach that combines the strength of tag ranking with the power of matrix recovery. Instead of having to make a binary decision for each tag, our approach ranks tags in the descending order of their relevance to the given image, significantly simplifying the problem. In addition, the proposed method aggregates the prediction models for different tags into a matrix, and casts tag ranking into a matrix recovery problem. It introduces the matrix trace norm to explicitly control the model complexity, so that a reliable prediction model can be learned for tag ranking even when the tag space is large and the number of training images is limited. Experiments on multiple well-known image data sets demonstrate the effectiveness of the proposed framework for tag ranking compared with the state-of-the-art approaches for image annotation and tag ranking. | 2012 | Towards relevance and saliency ranking of image tagsabstractSocial image tag ranking has emerged as an important research topic recently due to its potential application on web image search. This paper presents an adaptive all-season tag ranking algorithm which can handle the images with and without distinct object(s) using different tag ranking strategies. Firstly, based on saliency map derived from the visual attention model, a linear SVM is trained to pre-classify an image as attentive or non-attentive category by using the gray histogram descriptor on the corresponding saliency map. Then, an image with distinct object is processed by an attention-driven tag saliency ranking algorithm emphasizing distinct object. On the other hand, an image without distinct object is processed by the tag relevance ranking algorithm via the sparse representation based neighbor-voting strategy. Such adaptive ranking strategy can be regarded as taking full advantage of existing tag ranking paradigms. | 2011 | Supervised Sparse Patch Coding towards Misalignment-Robust Face RecognitionabstractWe address the challenging problem of face recognition under the scenarios where both training and test data are possibly contaminated with spatial misalignments. A supervised sparse coding framework is developed in this paper towards a practical solution to misalignment-robust face recognition. Each given probe face image is then uniformly divided into a set of local patches. We propose to sparsely reconstruct each probe image patch from the patches of all gallery images, and at the same time the reconstructions for all patches of the probe image are regularized by one term towards enforcing sparsity on the subjects of those selected patches. The derived reconstruction coefficients by ℓ1-norm minimization are then utilized to fuse the subject information of the patches for identifying the probe face. Such a supervised sparse coding framework provides a unique solution to face recognition. Extensive face recognition experiments on three benchmark face datasets demonstrate the advantages of the proposed framework over holistic sparse coding and conventional subspace learning based algorithms in terms of robustness to spatial misalignments and image occlusions. In this paper, we propose a robust approach to extracting the salient region based on bottom-up visual attention. The main contributions are twofold: 1) Instead of the feature parallel integration, the proposed saliencies are derived by serial processing between texture and color feature. 2) A constructive approach is proposed for rendering an image by a non-linear intensity mapping, which can efficiently eliminate high contrast noise regions in the image. And then the salient map can be robustly generated for a variety of nature images. Finally, the salient region extracted by our algorithm is used for image semantic retrieval.
