An Action-Aware Generative Sequence Modeling for Short Video RecommendationabstractWith the rapid development of the Internet, users have increasingly higher expectations for the recommendation accuracy of online content consumption platforms (e.g., short video platforms). However, short videos often contain diverse segments, and users may not hold the same attitude toward all of them (e.g., music enthusiasts may not enjoy all songs in a medley). Traditional binary-classification recommendation models, which treat a video as a single holistic entity, face limitations in accurately capturing such nuanced preferences. Considering that user consumption is a temporal process, this paper demonstrates that the timing of user actions can represent diverse intentions through statistical analysis and examination of action patterns. Based on this insight, we propose a novel modeling paradigm: Action-Aware Gen erative Sequence Network (A2Gen ), which refines user actions (e.g., Like and Follow, etc.) along the temporal dimension and chains them into sequences for unified processing and prediction. First, we introduce the Context-aware Attention Module (CAM) to model action sequences enriched with item-specific contextual features. Building upon this, we develop the Hierarchical Sequence Encoder (HSE) to learn temporal action patterns from users' historical actions. Finally, through leveraging CAM, we design a module for action sequence generation: the Action-seq Autoregressive Generator (AAG). Extensive offline experiments on the Kuaishou's dataset and the Tmall public dataset demonstrate the superiority of our proposed model. Furthermore, through large-scale online A/B testing deployed on Kuaishou's platform, our model achieves significant improvements over baseline methods in multi-task prediction by leveraging sequential information. Specifically, it yields increases of 0.34% in user watch time, 8.1% in interaction rate, and 0.162% in overall user retention (LifeTime-7), leading to successful deployment across all traffic, serving over 400 million users every day. | 2026 | SMT(LIA) Sampling with High DiversityabstractSMT sampling refers to the task of generating a set of satisfying assignments (samples) for a given SMT formula. An effective SMT sampler should be capable of producing samples with high diversity to maximize coverage of the solution space. However, most SMT samplers struggle to adequately cover the solution space and fail to generate sufficiently diverse solutions. To address these limitations, we propose $$ HighDiv $$ , the first iterative sampling framework that integrates CDCL(T) and local search in a bidirectional guided manner. During the bidirectional guidance process, solutions generated by CDCL(T) guide the variable initialization of the local search. Conversely, solutions produced by the local search guide CDCL(T) to further explore the solution space. Additionally, we design a novel local search algorithm, Context-Constrained Stochastic Search (CCSS), which introduces the Constraint-Partitioned Variable Initialization and the boundary-aware move operator. These components effectively balance exploration and feasibility throughout the search process. We conduct an extensive evaluation on QF_LIA formulas from the SMT-LIB benchmark. The results demonstrate that $$ HighDiv $$ achieves substantial improvements in diversity over the state-of-the-art SMT sampling tools. Yong Lai 0001, Chuan Luo 0002

CirOPT: Toward Effective Combinational Equivalence Checking via Compiler OptimizationabstractCombinational equivalence checking (CEC) is essential for verifying the correctness of circuit designs. With the growing complexity of circuits, effective verification techniques have become increasingly critical. Recently, a conjunctive normal form (CNF)-based approach, converting circuits to CNF for Boolean satisfiability (SAT) solvers, has shown competitive performance compared to state-of-the-art hybrid SAT sweeping approaches. The capability of this CNF-based approach depends on effective CNF conversion. This work presentsCirOPT, which is the first CNF conversion method using compiler optimization to equivalently simplify circuits. Extensive experiments are conducted on a broad range of real-world benchmarks, which are far more than the number of benchmarks typically used in empirical studies. The results reveal that, when paired with the state-of-the-art CNF SAT solverKissat,CirOPTconsiderably outperforms existing approaches in CEC. | 2025 | Better Understandings and Configurations in MaxSAT Stochastic Local Search Solvers via Anytime Performance AnalysisabstractThough numerous solvers have been proposed for the MaxSAT problem, and the benchmark environment such as MaxSAT Evaluations provides a platform for the comparison of the state-of-the-art solvers, existing assessments were usually evaluated based on the quality, e.g., fitness, of the best-found solutions obtained within a given running time budget. However, concerning solely the final obtained solutions regarding specific time budgets may restrict us from comprehending the behavior of the solvers along the convergence process. This paper demonstrates that Empirical Cumulative Distribution Functions can be used to compare MaxSAT stochastic local search solvers' anytime performance across multiple problem instances and various time budgets. The assessment reveals distinctions in solvers' performance and displays that the (dis)advantages of solvers adjust along different running times. This work also exhibits that the quantitative and high variance assessment of anytime performance can guide machines, i.e., automatic configurators, to search for better parameter settings. Our experimental results show that the hyperparameter optimization tool, i.e., SMAC, can achieve better parameter settings of solvers when using the anytime performance as the cost function, compared to using the metrics based on the fitness of the best-found solutions. | 2025 | Towards High-Strength Combinatorial Interaction Testing for Highly Configurable Software SystemsabstractHighly configurable software systems are crucial in practice to satisfy the rising demand for software customization, and combinatorial interaction testing (CIT) is an important methodology for testing such systems. Constrained covering array generation (CCAG), as the core problem in CIT, is to construct a$t$-wise covering array (CA) of minimum size, where$t$represents the testing strength. Extensive studies have demonstrated that high-strength CIT (e.g., 4-wise and 5-wise CIT) has stronger fault detection capability than low-strength CIT (i.e., 2-wise and 3-wise CIT), and there exist certain critical faults that can be disclosed through high-strength CIT. Although existing CCAG algorithm has exhibited effectiveness in solving the low-strength CCAG problem, they suffer the severe highstrength challenge when solving 4-wise and 5-wise CCAG, which urgently calls for effective solutions to solving 4-wise and 5 wise CCAG problems. To alleviate the high-strength challenge, we propose a novel and effective local search algorithm dubbed HSCA. Particularly, HSCA incorporates three new and powerful techniques, i.e., multi-round CA generation mechanism, dynamic priority assigning technique, and variable grouping strategy, to improve its performance. Extensive experiments on 35 real-world and synthetic instances demonstrate that HSCA can generate significantly smaller 4-wise and 5-wise CAs than existing state-of-the-art CCAG algorithms. More encouragingly, among all 35 instances, HSCA successfully builds 4-wise and 5-wise CAs for 35 and 29 instances, respectively, including 11 and 15 instances where existing CCAG algorithms fail. Our results indicate that HSCA can effectively mitigate the high-strength challenge. Chuan Luo 0002, Shuangyu Lyu, Wei Wu 0011, Hongyu Zhang 0002, Chunming Hu

SMTgazer: Learning to Schedule SMT Algorithms via Bayesian OptimizationabstractSatisfiability Modulo Theories (SMT) plays a critical role in various software engineering applications, including program verification, symbolic execution, and automated test generation. Over the years, a wide range of SMT solvers has been developed, typically designed for general purposes or tailored to specific background theories, such as bit-vectors or nonlinear arithmetic. Due to the diversity and complexity of SMT instances, no single solver consistently outperforms others across all problem domains. This motivates the need for algorithm selection strategies that can adaptively choose solvers based on the characteristics of the instances. To overcome the limitations of single-solver selection, solving SMT as a scheduling problem, enabling a more fault-tolerant and effective use of multiple solvers in sequence. We model algorithm scheduling as a hyperparameter optimization problem, enabling efficient black-box search over solver sequences while treating the dataset as a whole, thus achieving globally optimized and robust scheduling strategies. The resulting scheduler called SMTgazer. To further enhance scheduling efficiency and solver performance, we propose two optimizations: leveraging unsupervised X-means clustering to create semantically coherent instance groups for localized model training, and augmenting the Bayesian optimization surrogate with boosting and bagging ensembles to improve generalization and mitigate overfitting, thereby yielding more reliable performance predictions for the sequential portfolio scheduler.Extensive experiments are conducted to evaluate the performance of SMTgazer, utilizing six SMT benchmarks derived from real-world applications. It shows that our approach consistently outperforms current state-of-the-art methods. Particularly, SMTgazer achieves a 44.65% reduction in PAR-2 score and 69.11% decrease in the number of unsolved instances, compared to the strongest competitor, Sibyl, demonstrating the effectiveness of formulating SMT algorithm scheduling as a hyperparameter optimization problem. We further analyze the generated scheduling sequences to uncover the design principles that explain the success of our method. Finally, we also empirically show that our approach is both robust and generalizable, and the proposed strategies are effective. | 2025 | Beyond Node-Centric Modeling: Sketching Signed Networks with Simplicial ComplexesabstractSigned networks can reflect more complex connections through positive and negative edges, and cost-effective signed network sketching can significantly benefit an important link sign prediction task in the era of big data. Existing signed network embedding algorithms mainly learn node representation in the Graph Neural Network (GNN) framework with the balance theory. However, the node-wise representation learning methods either limit the representational power because they primarily rely on node pairwise relationship in the network, or suffer from severe efficiency issues. Recent research has explored simplicial complexes to capture higher-order interactions and integrated them into GNN frameworks. Motivated by that, we propose EdgeSketch+, a simple and effective edge embedding algorithm beyond traditional node-centric modeling that directly represents edges as low-dimensional vectors without transitioning from node embeddings. The proposed approach maintains a good balance between accuracy and efficiency by exploiting the Locality Sensitive Hashing (LSH) technique to swiftly capture the higher-order information derived from the simplicial complex in a manner of no learning processes. Experiments show that EdgeSketch+ matches state-of-the-art accuracy while significantly reducing runtime, achieving speedups of up to $546.07\times$ compared to GNN-based methods. | 2025 | Sketching Very Large-scale Dynamic Attributed Networks More PracticallyabstractReal-world networks, particularly those in web and social media, are dynamic with evolving node attributes and structures, often involving billions of nodes and edges. Dynamic attributed network embedding is a powerful tool for capturing these changes, enabling data owners and problem owners to better understand interactions and trends for more effective engagement and decision-making. While some existing algorithms are capable of handling very large-scale dynamic attributed networks with billions of nodes and edges, they often suffer from accuracy loss or high computational overhead. In this paper, we propose a practical and sustainable framework of sketching very large-scale dynamic attributed networks called VLS2ketch, which incorporates incremental embedding updates alongside storage-efficient, binarized representation of both node attributes and topological variations. By the sparse random projection technique in an incremental update manner, VLS2ketch significantly reduces the energy-intensive computational workload while maintaining accuracy. Also, we introduce an information decay mechanism, which adapts to temporally varying topologies and node attributes. This mechanism ensures that outdated information gradually diminishes over time. Extensive experiments on real-world very large-scale datasets demonstrate that our proposed VLS2ketch method delivers comparable embedding quality against the state-of-the-art learning-based competitors with dramatically reduced runtime. We have released the source code and the datasets in https://github.com/AIandBD/graph-hashing/tree/main/VLS2ketch. . Wei Wu 0011, Ling Chen 0006, Fangfang Li 0004, Chuan Luo 0002

Towards Effective Local Search for Qubit MappingabstractIn the era of noisy intermediate-scale quantum (NISQ), a quantum logical circuit must undergo certain compilation before it can be used on a NISQ device, subject to connectivity constraints posed by NISQ devices. During compilation, numerous auxiliary quantum gates are inserted, but a circuit with too many is unreliable, necessitating gate minimization. This requirement gives rise to the qubit mapping problem (QMP), an NP-hard optimization problem that is critical in quantum computing. This work proposes a novel and effective local search algorithm dubbedEffectiveQM. First,EffectiveQMproposes a new mode-aware search strategy to alleviate the challenge of being trapped in local optima, where local search typically suffers. Moreover,EffectiveQMintroduces a novel potential-guided scoring function, which can thoroughly quantify the actual benefit brought by an operation of inserting auxiliary gates. By incorporating the potential-guided scoring function,EffectiveQMcan effectively determine the appropriate operation to be performed. Extensive experiments on a diverse collection of logical circuits and 6 NISQ devices demonstrate thatEffectiveQMcan generate physical circuits with significantly fewer inserted auxiliary gates than current state-of-the-art QMP algorithms, indicating thatEffectiveQMgreatly advances the state of the art in QMP solving. | 2025 | Time- and Space-Efficiently Sketching Billion-Scale Attributed NetworksabstractAttributed network embedding seeks to depict each network node via a compact, low-dimensional vector while effectively preserving the similarity between node pairs, which lays a strong foundation for a great many high-level network mining tasks. With the advent of the era of Big Data, the number of nodes and edges has reached billions in many real-world networks, which poses great computational and storage challenges to the existing methods. Although some algorithms have been developed to handle billion-scale networks, they often undergo accuracy degradation or tempo-spatial inefficiency owing to attribute information loss or substantial parameter learning. To this end, we propose a simple, time- and space-efficient billion-scale attributed network embedding algorithm called SketchBANE in this paper, which strikes an excellent balance between accuracy and efficiency by adopting sparse random projection with 1-bit quantization to sketch the iterative closed neighborhood and maintain the similarity among high-order nodes in a non-learning manner. The extensive experimental results indicate that our proposed SketchBANE algorithm competes favorably with the state-of-the-art approaches, while remarkably reducing runtime and space consumption. Also, the proposed SketchBANE algorithm exhibits good scalability and parallelization. Wei Wu 0011, Mi Jiang, Chuan Luo 0002, Fangfang Li 0004

Solving the t-Wise Coverage Maximum Problem via Effective and Efficient Local Search-Based SamplingabstractTo meet the increasing demand for customized software, highly configurable systems become essential in practice. Such systems offer many options to configure, and ensuring the reliability of these systems is critical. A widely used evaluation metric for testing these systems is \(t\) -wise coverage, where \(t\) represents testing strength, and its value typically ranges from 2 to 6. It is crucial to design effective and efficient methods for generating test suites that achieve high \(t\) -wise coverage. However, current state-of-the-art methods need to generate large test suites for achieving high \(t\) -wise coverage. In this work, we propose a novel method called LS-Sampling-Plus that can efficiently generate test suites with high \(t\) -wise coverage for \(2\leq t\leq 6\) while being smaller in size compared to existing state-of-the-art methods. LS-Sampling-Plus incorporates many core algorithmic techniques, including two novel scoring functions, a dynamic mechanism for updating sampling probabilities, and a validity-guaranteed systematic search method. Our experiments on various practical benchmarks show that LS-Sampling-Plus can achieve higher \(t\) -wise coverage than current state-of-the-art methods, through building a test suite of the same size. Moreover, our evaluations indicate the effectiveness of all core algorithmic techniques of LS-Sampling-Plus . Furthermore, LS-Sampling-Plus exhibits better scalability and fault detection capability than existing state-of-the-art methods. | 2024 | Beyond Pairwise Testing: Advancing 3-wise Combinatorial Interaction Testing for Highly Configurable SystemsabstractTo meet the rising demand for software customization, highly configurable software systems play key roles in practice. Combinatorial interaction testing (CIT) is recognized as an effective approach for testing such systems. For CIT, the most important problem is constrained covering array generation (CCAG), which aims to construct a minimum-sized t-wise covering array (CA), where t denotes testing strength. Compared to pairwise testing (i.e., 2-wise CIT) that is a widely-used CIT technique, 3-wise CIT can discover more faults and bring more benefit in real-world applications. However, current state-of-the-art CCAG algorithms suffer from the severe scalability challenge for 3-wise CIT, which renders them ineffective in building 3-wise CAs for highly configurable systems. In this work, we perform an empirical study on various practical, highly configurable systems to present that it is promising to build 3-wise CA through extending 2-wise CA. Inspired by this, we propose ScalableCA, a novel and scalable algorithm that can effectively alleviate the scalability challenge for 3-wise CIT. Further, ScalableCA introduces three new and effective techniques, including fast invalidity detection, uncovering-guided sampling, and remainder-aware local search, to enhance its performance. Our experiments on extensive real-world, highly configurable systems show that, compared to current state-of-the-art algorithms, ScalableCA requires one to two orders of magnitude less running time to build 3-wise CA of 38.9% smaller size in average for large-scale instances. Our results indicate that ScalableCA greatly advances the state of the art in 3-wise CIT. Chuan Luo 0002, Shuangyu Lyu, Qiyuan Zhao, Wei Wu 0011, Hongyu Zhang 0002, Chunming Hu

Scene-wise Adaptive Network for Dynamic Cold-start Scenes Optimization in CTR PredictionabstractIn the realm of modern mobile E-commerce, providing users with nearby commercial service recommendations through location-based online services has become increasingly vital. While machine learning approaches have shown promise in multi-scene recommendation, existing methodologies often struggle to address cold-start problems in unprecedented scenes: the increasing diversity of commercial choices, along with the short online lifespan of scenes, give rise to the complexity of effective recommendations in online and dynamic scenes. In this work, we propose Scene-wise Adaptive Network (SwAN 1), a novel approach that emphasizes high-performance cold-start online recommendations for new scenes. Our approach introduces several crucial capabilities, including scene similarity learning, user-specific scene transition cognition, scene-specific information construction for the new scene, and enhancing the diverged logical information between scenes. We demonstrate SwAN’s potential to optimize dynamic multi-scene recommendation problems by effectively online handling cold-start recommendations for any newly arrived scenes. More encouragingly, SwAN has been successfully deployed in Meituan’s online catering recommendation service, which serves millions of customers per day, and SwAN has achieved a 5.64% CTR index improvement relative to the baselines and a 5.19% increase in daily order volume proportion. | 2024 | NuSC: An Effective Local Search Algorithm for Solving the Set Covering ProblemabstractThe set covering problem (SCP) is a fundamental NP-hard problem in computer science and has a broad range of important real-world applications. In practice, SCP instances transformed from real-world applications would be of large scale, so it is of significant importance to design effective heuristic algorithms, especially local search ones. However, there exist only few research works on developing local search algorithms for solving SCP. In this article, we propose a new local search algorithm for solving SCP, dubbed NuSC. In particular, NuSC introduces a new combined scoring function for subset selection, which combines different subset properties in an effective way and helps NuSC find more optimized solutions. Besides, NuSC incorporates a dynamic weighting scheme for elements, a tabu search strategy, and a novelty selection mechanism to further enhance its practical performance. In order to study the effectiveness and robustness of our proposed NuSC algorithm, we conduct extensive experiments to compare NuSC against many state-of-the-art competitors on various types of SCP instances. Our experimental results demonstrate that NuSC significantly outperforms its competitors on the majority of instances, indicating the superiority of NuSC. Also, our empirical evaluations confirm the effectiveness of each algorithmic technique underlying NuSC. Chuan Luo 0002, Wenqian Xing, Shaowei Cai 0001, Chunming Hu

MPSketch: Message Passing Networks via Randomized Hashing for Efficient Attributed Network EmbeddingabstractGiven a network, it is well recognized that attributed network embedding represents each node of the network in a low-dimensional space, and, thus, brings considerable benefits for numerous graph mining tasks. In practice, a diverse set of graph tasks can be processed efficiently via the compact representation that preserves content and structure information. The majority of attributed network embedding approaches, especially, the graph neural network (GNN) algorithms, are substantially costly in either time or space due to the expensive learning process, while the randomized hashing technique, locality-sensitive hashing (LSH), which does not need learning, can speedup the embedding process at the expense of losing some accuracy. In this article, we propose the MPSketch model, which bridges the performance gap between the GNN framework and the LSH framework by adopting the LSH technique to pass messages and capture high-order proximity in a larger aggregated information pool from the neighborhood. The extensive experimental results confirm that in node classification and link prediction, the proposed MPSketch algorithm enjoys performance comparable to the state-of-the-art learning-based algorithms and outperforms the existing LSH algorithms, while running faster than the GNN algorithms by 3-4 orders of magnitude. More precisely, MPSketch runs 2121, 1167, and 1155 times faster than GraphSAGE, GraphZoom, and FATNet on average, respectively. Wei Wu 0011, Bin Li 0015, Chuan Luo 0002, Wolfgang Nejdl

Automated Test Suite Generation for Software Product Lines Based on Quality-Diversity OptimizationabstractA Software Product Line (SPL) is a set of software products that are built from a variability model. Real-world SPLs typically involve a vast number of valid products, making it impossible to individually test each of them. This arises the need for automated test suite generation, which was previously modeled as either a single-objective or a multi-objective optimization problem considering only objective functions. This article provides a completely different mathematical model by exploiting the benefits of Quality-Diversity (QD) optimization that is composed of not only an objective function (e.g., t -wise coverage or test suite diversity) but also a user-defined behavior space (e.g., the space with test suite size as its dimension). We argue that the new model is more suitable and generic than the two alternatives because it provides at a time a large set of diverse (measured in the behavior space) and high-performing solutions that can ease the decision-making process. We apply MAP-Elites, one of the most popular QD algorithms, to solve the model. The results of the evaluation, on both realistic and artificial SPLs, are promising, with MAP-Elites significantly and substantially outperforming both single- and multi-objective approaches, and also several state-of-the-art SPL testing tools. In summary, this article provides a new and promising perspective on the test suite generation for SPLs. Yi Xiang 0002, Han Huang 0002, Miqing Li, Chuan Luo 0002, Xiaowei Yang 0003

NuWLS: Improving Local Search for (Weighted) Partial MaxSAT by New Weighting TechniquesabstractMaximum Satisfiability (MaxSAT) is a prototypical constraint optimization problem, and its generalized version is the (Weighted) Partial MaxSAT problem, denoted as (W)PMS, which deals with hard and soft clauses. Considerable progress has been made on stochastic local search (SLS) algorithms for solving (W)PMS, which mainly focus on clause weighting techniques. In this work, we identify two issues of existing clause weighting techniques for (W)PMS, and propose two ideas correspondingly. First, we observe that the initial values of soft clause weights have a big effect on the performance of the SLS solver for solving (W)PMS, and propose a weight initialization method. Second, we propose a new clause weighting scheme that for the first time employs different conditions for updating hard and soft clause weights. Based on these two ideas, we develop a new SLS solver for (W)PMS named NuWLS. Through extensive experiments, NuWLS performs much better than existing SLS solvers on all 6 benchmarks from the incomplete tracks of MaxSAT Evaluations (MSEs) 2019, 2020, and 2021. In terms of the number of winning instances, NuWLS outperforms state-of-the-art SAT-based incomplete solvers on all the 6 benchmarks. More encouragingly, a hybrid solver that combines NuWLS and an SAT-based solver won all four categories in the incomplete track of the MaxSAT Evaluation 2022. | 2023 | HiNet: Novel Multi-Scenario & Multi-Task Learning with Hierarchical Information ExtractionabstractMulti-scenario & multi-task learning has been widely applied to many recommendation systems in industrial applications, wherein an effective and practical approach is to carry out multi-scenario transfer learning on the basis of the Mixture-of-Expert (MoE) architecture. However, the MoE-based method, which aims to project all information in the same feature space, cannot effectively deal with the complex relationships inherent among various scenarios and tasks, resulting in unsatisfactory performance. To tackle the problem, we propose a Hierarchical information extraction Network (HiNet) for multi-scenario and multi-task recommendation, which achieves hierarchical extraction based on coarse-to-fine knowledge transfer scheme. The multiple extraction layers of the hierarchical network enable the model to enhance the capability of transferring valuable information across scenarios while preserving specific features of scenarios and tasks. Furthermore, a novel scenario-aware attentive network module is proposed to model correlations between scenarios explicitly. Comprehensive experiments conducted on real-world industrial datasets from Meituan Meishi platform demonstrate that HiNet achieves a new state-of-the-art performance and significantly outperforms existing solutions. | 2023 | Did We Miss Something Important? Studying and Exploring Variable-Aware Log AbstractionabstractDue to the sheer size of software logs, developers rely on automated techniques for log analysis. One of the first and most important steps of automated log analysis is log abstraction, which parses the raw logs into a structured format. Prior log abstraction techniques aim to identify and abstract all the dynamic variables in logs and output a static log template for automated log analysis. However, these abstracted dynamic variables may also contain important information that is useful to different tasks in log analysis. In this paper, we investigate the characteristics of dynamic variables and their importance in practice, and explore the potential of a variable-aware log abstraction technique. Through manual investigations and surveys with practitioners, we find that different categories of dynamic variables record various information that can be important depending on the given tasks, the distinction of dynamic variables in log abstraction can further assist in log analysis. We then propose a deep learning based log abstraction approach, named VALB, which can identify different categories of dynamic variables and preserve the value of specified categories of dynamic variables along with the log templates (i.e., variable-aware log abstraction). Through the evaluation on a widely used log abstraction benchmark, we find that VALB outperforms other state-of-the-art log abstraction techniques on general log abstraction (i.e., when abstracting all the dynamic variables) and also achieves a high variable-aware log abstraction accuracy that further identifies the category of the dynamic variables. Our study highlights the potential of leveraging the important information recorded in the dynamic variables to further improve the process of log analysis. | 2023 | SCHash: Speedy Simplicial Complex Neural Networks via Randomized HashingabstractGraphs, as a non-linear data structure, are ubiquitous in practice, and efficient graph analysis can benefit important information retrieval applications in the era of big data. Currently, one of the fundamental graph mining problems is graph embedding, which aims to represent the graph as a low-dimensional feature vector with the content and structural information in the graph preserved. Although the graph embedding technique has evolved considerably, traditional methods mainly focus on node pairwise relationship in graphs, which makes the representational power of such schemes limited. Recently, a number of works have explored the simplicial complexes, which describe the higher-order interactions between nodes in the graphs, and further proposed several Graph Neural Network (GNN) algorithms based on simplicial complexes. However, these GNN approaches are highly inefficient in terms of running time and space, due to massive parameter learning. In this paper, we propose a simple and speedy graph embedding algorithm dubbed SCHash. Through adopting the Locality Sensitive Hashing (LSH) technique, SCHash captures the higher-order information derived from the simplicial complex in the GNN framework, and it can achieve a good balance between accuracy and efficiency. Our extensive experiments clearly show that, in terms of accuracy, the performance of our proposed SCHash algorithm is comparable to that of state-of-the-art GNN algorithms; also, SCHash achieves higher accuracy than the existing LSH algorithms. In terms of efficiency, SCHash runs faster than GNN algorithms by 2 ~ 4 orders of magnitude, and is more efficient than the existing LSH algorithms. Wei Wu 0011, Chuan Luo 0002

CAmpactor: A Novel and Effective Local Search Algorithm for Optimizing Pairwise Covering ArraysabstractThe increasing demand for software customization has led to the development of highly configurable systems. Combinatorial interaction testing (CIT) is an effective method for testing these types of systems. The ultimate goal of CIT is to generate a test suite of acceptable size, called a t-wise covering array (CA), where t is the testing strength. Pairwise testing (i.e., CIT with t=2) is recognized to be the most widely-used CIT technique and has strong fault detection capability. In pairwise testing, the most important problem is pairwise CA generation (PCAG), which is to generate a pairwise CA (PCA) of minimum size. However, existing state-of-the-art PCAG algorithms suffer from the severe scalability challenge; that is, they cannot tackle large-scale PCAG instances effectively, resulting in PCAs of large sizes. To alleviate this challenge, in this paper we propose CAmpactor, a novel and effective local search algorithm for compacting given PCAs into smaller sizes. Extensive experiments on a large number of real-world, public PCAG instances show that the sizes of CAmpactor's generated PCAs are around 45% smaller than the sizes of PCAs constructed by existing state-of-the-art PCAG algorithms, indicating its superiority. Also, our evaluation confirms the generality of CAmpactor, since CAmpactor can reduce the sizes of PCAs generated by a variety of PCAG algorithms. | 2022 | Search-based Diverse Sampling from Real-world Software Product LinesabstractReal-world software product lines (SPLs) often encompass enormous valid configurations that are impossible to enumerate. To understand properties of the space formed by all valid configurations, a feasible way is to select a small and valid sample set. Even though a number of sampling strategies have been proposed, they either fail to produce diverse samples with respect to the number of selected features (an important property to characterize behaviors of configurations), or achieve diverse sampling but with limited scalability (the handleable configuration space size is limited to 1013). To resolve this dilemma, we propose a scalable diverse sampling strategy, which uses a distance metric in combination with the novelty search algorithm to produce diverse samples in an incremental way. The distance metric is carefully designed to measure similarities between configurations, and further diversity of a sample set. The novelty search incrementally improves diversity of samples through the search for novel configurations. We evaluate our sampling algorithm on 39 real-world SPLs. It is able to generate the required number of samples for all the SPLs, including those which cannot be counted by sharpSAT, a state-of-the-art model counting solver. Moreover, it performs better than or at least competitively to state-of-the-art samplers regarding diversity of the sample set. Experimental results suggest that only the proposed sampler (among all the tested ones) achieves scalable diverse sampling. | 2022 | T-SMOTE: Temporal-oriented Synthetic Minority Oversampling Technique for Imbalanced Time Series ClassificationabstractTime series classification is a popular and important topic in machine learning, and it suffers from the class imbalance problem in many real-world applications. In this paper, to address the class imbalance problem, we propose a novel and practical oversampling method named T-SMOTE, which can make full use of the temporal information of time-series data. In particular, for each sample of minority class, T-SMOTE generates multiple samples that are close to class border. Then, based on those samples near class border, T-SMOTE synthesizes more samples. Finally, a weighted sampling method is called on both generated samples near class border and synthetic samples. Extensive experiments on a diverse set of both univariate and multivariate time-series datasets demonstrate that T-SMOTE consistently outperforms the current state-of-the-art methods on imbalanced time series classification. | 2022 | Multi-task Hierarchical Classification for Disk Failure Prediction in Online Service SystemsabstractOne of the most common threats to online service system's reliability is disk failure. Many disk failure prediction techniques have been developed to predict failures before they actually occur, allowing proactive steps to be taken to minimize service disruption and increase service reliability. Existing approaches for disk failure prediction do not differentiate among various types of disk failure. In industrial practice, however, different product teams treat distinct types of disk failures as different prediction tasks in large-scale online service systems like Microsoft 365. For example, hardware operation team is concerned with physical disk errors, while database service team focuses on I/O delay. In this paper, we propose MTHC (Multi-Task Hierarchical Classification) to enhance the performance of disk failure prediction for each task via multi-task learning. In addition, MTHC introduces a novel hierarchy-aware mechanism to deal with the data imbalance problem, which is a severe issue in the area of disk failure prediction. We show that MTHC can be easily utilized to enhance most state-of-the-art disk failure prediction models. Our experiments on both industrial and public datasets demonstrate that such disk failure prediction models enhanced by MTHC performs much better than those models working without MTHC. Furthermore, our experiments also present that the hierarchical-aware mechanism underlying MTHC can alleviate the data imbalance problem and thus improve the practical performance of various disk failure prediction models. More encouragingly, the proposed MTHC has been successfully applied to Microsoft 365 online service systems, and averagely reduces the number of virtual machine interruptions by 10% per month. | 2022 | NENYA: Cascade Reinforcement Learning for Cost-Aware Failure Mitigation at Microsoft 365abstractLarge-scale distributed systems, such as Microsoft 365's database system, require timely mitigation solutions to address failures and improve service availability and reliability. Still, mitigation actions can be costly as they may cause temporal performance degradation and even incur monetary expenses. Mitigation actions can be either administrated in a reactive fashion to contain detected failures or a proactive fashion to reduce potential failures. The proactive mitigation approach typically relies on a two-stage strategy: the prediction model will firstly identify instances (such as databases or disks) with high failure risk, then appropriate mitigation actions chosen by engineers or an automatic bandit learning model can be applied. As information is not fully shared across those two stages, important factors such as mitigation costs and states of instances are often ignored in one of those two stages. To address these issues, we propose NENYA, an end-to-end mitigation solution for a large-scale database system powered by a novel cascade reinforcement learning model. By taking the states of databases as input, NENYA directly outputs mitigation actions and is optimized based on jointly cumulative feedback on mitigation costs and failure rates. As the overwhelming majority of databases do not require mitigation actions, NENYA utilizes a novel cascade decision structure to firstly reliably filter out such databases and then focus on choosing appropriate mitigation actions for the rest. Extensive offline and online experiments have shown that our methods can outperform existing practices in reducing both failure rates of databases and mitigation costs. NENYA has been integrated into Microsoft 365, a productive platform, with sounding success. | 2022 | SamplingCA: effective and efficient sampling-based pairwise testing for highly configurable software systemsabstractCombinatorial interaction testing (CIT) is an effective paradigm for testing highly configurable systems, and its goal is to generate a t-wise covering array (CA) as a test suite, where t is the strength of testing. It is recognized that pairwise testing (i.e., CIT with t=2) is the most common CIT technique, and has high fault detection capability in practice. The problem of pairwise CA generation (PCAG), which is a core problem in pairwise testing, aims at generating a pairwise CA (i.e., 2-wise CA) of minimum size, subject to hard constraints. The PCAG problem is a hard combinatorial optimization problem, which urgently requires practical methods for generating pairwise CAs (PCAs) of small sizes. However, existing PCAG algorithms suffer from the severe scalability issue; that is, when solving large-scale PCAG instances, existing state-of-the-art PCAG algorithms usually cost a fairly long time to generate large PCAs, which would make the testing of highly configurable systems both ineffective and inefficient. In this paper, we propose a novel and effective sampling-based approach dubbed SamplingCA for solving the PCAG problem. SamplingCA first utilizes sampling techniques to obtain a small test suite that covers valid pairwise tuples as many as possible, and then adds a few more test cases into the test suite to ensure that all valid pairwise tuples are covered. Extensive experiments on 125 public PCAG instances show that our approach can generate much smaller PCAs than its state-of-the-art competitors, indicating the effectiveness of SamplingCA. Also, our experiments show that SamplingCA runs one to two orders of magnitude faster than its competitors, demonstrating the efficiency of SamplingCA. Our results confirm that SamplingCA is able to address the scalability issue and considerably pushes forward the state of the art in PCAG solving. | 2022 | Sparkle: Toward Accessible Meta-Algorithmics for Improving the State of the Art in Solving Challenging ProblemsabstractMany fields of computational science advance through improvements in the algorithms used for solving key problems. These advancements are often facilitated by benchmarks and competitions that enable performance comparisons and rankings of solvers. Simultaneously, meta-algorithmic techniques, such as automated algorithm selection and configuration, enable performance improvements by utilizing the complementary strengths of different algorithms or configurable algorithm components. In fact, meta-algorithms have become major drivers in advancing the state of the art in solving many prominent computational problems. However, meta-algorithmic techniques are complex and difficult to use correctly, while their incorrect use may reduce their efficiency, or in extreme cases, even lead to performance losses. Here, we introduce the Sparkle platform, which aims to make meta-algorithmic techniques more accessible to nonexpert users, and to make these techniques more broadly available in the context of competitions, to further enable the assessment and advancement of the true state of the art in solving challenging computational problems. To achieve this, Sparkle implements standard protocols for algorithm selection and configuration that support easy and correct use of these techniques. | 2022 | Distributed Evolution Strategies for Black-Box Stochastic OptimizationabstractThis work concerns the evolutionary approaches to distributed stochastic black-box optimization, in which each worker can individually solve an approximation of the problem with nature-inspired algorithms. We propose a distributed evolution strategy (DES) algorithm grounded on a proper modification to evolution strategies, a family of classic evolutionary algorithms, as well as a careful combination with existing distributed frameworks. On smooth and nonconvex landscapes, DES has a convergence rate competitive to existing zeroth-order methods, and can exploit the sparsity, if applicable, to match the rate of first-order methods. The DES method uses a Gaussian probability model to guide the search and avoids the numerical issue resulted from finite-difference techniques in existing zeroth-order methods. The DES method is also fully adaptive to the problem landscape, as its convergence is guaranteed with any parameter setting. We further propose two alternative sampling schemes which significantly improve the sampling efficiency while leading to similar performance. Simulation studies on several machine learning problems suggest that the proposed methods show much promise in reducing the convergence time and improving the robustness to parameter settings. | 2021 | Correlation-Aware Heuristic Search for Intelligent Virtual Machine Provisioning in Cloud SystemsabstractThe optimization of resource is crucial for the operation of public cloud systems such as Microsoft Azure, as well as servers dedicated to the workloads of large customers such as Microsoft 365. Those optimization tasks often need to take unknown parameters into consideration and can be formulated as Prediction+Optimization problems. This paper proposes a new Prediction+Optimization method named Correlation-Aware Heuristic Search (CAHS) that is capable of accounting for the uncertainty in unknown parameters and delivering effective solutions to difficult optimization problems. We apply this method to solving the predictive virtual machine (VM) provisioning (PreVMP) problem, where the VM provisioning plans are optimized based on the predicted demands of different VM types, to ensure rapid provisions upon customers' requests and to pursue high resource utilization. Unlike the current state-of-the-art PreVMP approaches that assume independence among the demands for different VM types, CAHS incorporates demand correlation when conducting prediction and optimization in a novel and effective way. Our experiments on two public benchmarks and one industrial benchmark demonstrate that CAHS can achieve better performance than its nine state-of-the-art competitors. | 2021 | PULNS: Positive-Unlabeled Learning with Effective Negative Sample SelectorabstractPositive-unlabeled learning (PU learning) is an important case of binary classification where the training data only contains positive and unlabeled samples. The current state-of-the-art approach for PU learning is the cost-sensitive approach, which casts PU learning as a cost-sensitive classification problem and relies on unbiased risk estimator for correcting the bias introduced by the unlabeled samples. However, this approach requires the knowledge of class prior and is subject to the potential label noise. In this paper, we propose a novel PU learning approach dubbed PULNS, equipped with an effective negative sample selector, which is optimized by reinforcement learning. Our PULNS approach employs an effective negative sample selector as the agent responsible for selecting negative samples from the unlabeled data. While the selected, likely negative samples can be used to improve the classifier, the performance of classifier is also used as the reward to improve the selector through the REINFORCE algorithm. By alternating the updates of the selector and the classifier, the performance of both is improved. Extensive experimental studies on 7 real-world application benchmarks demonstrate that PULNS consistently outperforms the current state-of-the-art methods in PU learning, and our experimental results also confirm the effectiveness of the negative sample selector underlying PULNS. | 2021 | AutoCCAG: An Automated Approach to Constrained Covering Array GenerationabstractCombinatorial interaction testing (CIT) is an important technique for testing highly configurable software systems with demonstrated effectiveness in practice. The goal of CIT is to generate test cases covering the interactions of configuration options, under certain hard constraints. In this context, constrained covering arrays (CCAs) are frequently used as test cases in CIT. Constrained Covering Array Generation (CCAG) is an NP-hard combinatorial optimization problem, solving which requires an effective method for generating small CCAs. In particular, effectively solving t-way CCAG with t>=4 is even more challenging. Inspired by the success of automated algorithm configuration and automated algorithm selection in solving combinatorial optimization problems, in this paper, we investigate the efficacy of automated algorithm configuration and automated algorithm selection for the CCAG problem, and propose a novel, automated CCAG approach called AutoCCAG. | 2021 | Predictive Job Scheduling under Uncertain Constraints in Cloud ComputingabstractCapacity management has always been a great challenge for cloud platforms due to massive, heterogeneous on-demand instances running at different times. To better plan the capacity for the whole platform, a class of cloud computing instances have been released to collect computing demands beforehand. To use such instances, users are allowed to submit jobs to run for a pre-specified uninterrupted duration in a flexible range of time in the future with a discount compared to the normal on-demand instances. Proactively scheduling those pre-collected job requests considering the capacity status over the platform can greatly help balance the computing workloads along time. In this work, we formulate the scheduling problem for these pre-collected job requests under uncertain available capacity as a Prediction + Optimization problem with uncertainty in constraints, and propose an effective algorithm called Controlling under Uncertain Constraints (CUC), where the predicted capacity guides the optimization of job scheduling and job scheduling results are leveraged to improve the prediction of capacity through Bayesian optimization. The proposed formulation and solution are commonly applicable for proactively scheduling problems in cloud computing. | 2021 | A Runtime Analysis of Typical Decomposition Approaches in MOEA/D Framework for Many-objective Optimization ProblemsabstractDecomposition approach is an important component in multi-objective evolutionary algorithm based on decomposition (MOEA/D), which is a popular method for handing many-objective optimization problems (MaOPs). This paper presents a theoretical analysis on the convergence ability of using the typical weighted sum (WS), Tchebycheff (TCH) or penalty-based boundary intersection (PBI) approach in a basic MOEA/D for solving two benchmark MaOPs. The results show that using WS, the algorithm can always find an optimal solution for any subproblem in polynomial expected runtime. In contrast, the algorithm needs at least exponential expected runtime for some subproblems if using TCH or PBI. Moreover, our analyses discover an obvious shortcoming of using WS, that is, the optimal solutions of different subproblems are easily corresponding to the same solution. In addition, this analysis indicates that if using PBI, a small value of the penalty parameter is a good choice for faster converging to the Pareto front, but it may lose the diversity. | 2021 | A Surrogate Objective Framework for Prediction+Programming with Soft ConstraintsabstractPrediction+optimization is a common real-world paradigm where we have to predict problem parameters before solving the optimization problem. However, the criteria by which the prediction model is trained are often inconsistent with the goal of the downstream optimization problem. Recently, decision-focused prediction approaches, such as SPO+ and direct optimization, have been proposed to fill this gap. However, they cannot directly handle the soft constraints with the max operator required in many real-world objectives. This paper proposes a novel analytically differentiable surrogate objective framework for real-world linear and semi-definite negative quadratic programming problems with soft linear and non-negative hard constraints. This framework gives the theoretical bounds on constraints’ multipliers, and derives the closed-form solution with respect to predictive parameters and thus gradients for any variable in the problem. We evaluate our method in three applications extended with soft constraints: synthetic linear programming, portfolio optimization, and resource provisioning, demonstrating that our method outperforms traditional two-staged methods and other decision-focused approaches Chuan Luo 0002, Liting Chen, Qingwei Lin, Dongmei Zhang 0001

RLNF: Reinforcement Learning based Noise Filtering for Click-Through Rate PredictionabstractClick-through rate (CTR) prediction aims to recall the advertisements that users are interested in and to lead users to click, which is of critical importance for a variety of online advertising systems. In practice, CTR prediction is generally formulated as a conventional binary classification problem, where the clicked advertisements are positive samples and the others are negative samples. However, directly treating unclicked advertisements as negative samples would suffer from the severe label noise issue, since there exist many reasons why users are interested in a few advertisements but do not click. To address such serious issue, we propose a reinforcement learning based noise filtering approach, dubbed RLNF, which employs a noise filter to select effective negative samples. In RLNF, such selected, effective negative samples can be used to enhance the CTR prediction model, and meanwhile the effectiveness of the noise filter can be enhanced through reinforcement learning using the performance of CTR prediction model as reward. Actually, by alternating the enhancements of the noise filter and the CTR prediction model, the performance of both the noise filter and the CTR prediction model is improved. In our experiments, we equip 7 state-of-the-art CTR prediction models with RLNF. Extensive experiments on a public dataset and an industrial dataset present that RLNF significantly improves the performance of all these 7 CTR prediction models, which indicates both the effectiveness and the generality of RLNF. | 2021 | Effective low capacity status prediction for cloud systemsabstractIn cloud systems, an accurate capacity planning is very important for cloud provider to improve service availability. Traditional methods simply predicting "when the available resources is exhausted" are not effective due to customer demand fragmentation and platform allocation constraints. In this paper, we propose a novel prediction approach which proactively predicts the level of resource allocation failures from the perspective of low capacity status. By jointly considering the data from different sources in both time series form and static form, the proposed approach can make accurate LCS predictions in a complex and dynamic cloud environment, and thereby improve the service availability of cloud systems. The proposed approach is evaluated by real-world datasets collected from a large scale public cloud platform, and the results confirm its effectiveness. | 2021 | LS-sampling: an effective local search based sampling approach for achieving high t-wise coverageabstractThere has been a rapidly increasing demand for developing highly configurable software systems, which urgently calls for effective testing methods. In practice, t-wise coverage has been widely recognized as a useful metric to evaluate the quality of a test suite for testing highly configurable software systems, and achieving high t-wise coverage is important for ensuring test adequacy. However, state-of-the-art methods usually cost a fairly long time to generate large test suites for high pairwise coverage (i.e., 2-wise coverage), which would lead to ineffective and inefficient testing of highly configurable software systems. In this paper, we propose a novel local search based sampling approach dubbed LS-Sampling for achieving high t-wise coverage. Extensive experiments on a large number of public benchmarks, which are collected from real-world, highly configurable software systems, show that LS-Sampling achieves higher 2-wise and 3-wise coverage than the current state of the art. LS-Sampling is effective, since on average it achieves the 2-wise coverage of 99.64% and the 3-wise coverage of 97.87% through generating a small test suite consisting of only 100 test cases (90% smaller than the test suites generated by its state-of-the-art competitors). Furthermore, LS-Sampling is efficient, since it only requires an average execution time of less than one minute to generate a test suite with high 2-wise and 3-wise coverage. | 2021 | NTAM: Neighborhood-Temporal Attention Model for Disk Failure Prediction in Cloud PlatformsabstractWith the rapid deployment of cloud platforms, high service reliability is of critical importance. An industrial cloud platform contains a huge number of disks, and disk failure is a common cause of service unreliability. In recent years, many machine learning based disk failure prediction approaches have been proposed, and they can predict disk failures based on disk status data before the failures actually happen. In this way, proactive actions can be taken in advance to improve service reliability. However, existing approaches treat each disk individually and do not explore the influence of the neighboring disks. In this paper, we propose Neighborhood-Temporal Attention Model (NTAM), a novel deep learning based approach to disk failure prediction. When predicting whether or not a disk will fail in near future, NTAM is a novel approach that not only utilizes a disk’s own status data, but also considers its neighbors’ status data. Moreover, NTAM includes a novel attention-based temporal component to capture the temporal nature of the disk status data. Besides, we propose a data enhancement method, called Temporal Progressive Sampling (TPS), to handle the extreme data imbalance issue. We evaluate NTAM on a public dataset as well as two industrial datasets collected from millions of disks in Microsoft Azure. Our experimental results show that NTAM significantly outperforms state-of-the-art competitors. Also, our empirical evaluations indicate the effectiveness of the neighborhood-ware component and the temporal component underlying NTAM as well as the effectiveness of TPS. More encouragingly, we have successfully applied NTAM and TPS to Microsoft cloud platforms (including Microsoft Azure and Microsoft 365) and obtained benefits in industrial practice. | 2021 | Hashing-Accelerated Graph Neural Networks for Link PredictionabstractNetworks are ubiquitous in the real world. Link prediction, as one of the key problems for network-structured data, aims to predict whether there exists a link between two nodes. The traditional approaches are based on the explicit similarity computation between the compact node representation by embedding each node into a low-dimensional space. In order to efficiently handle the intensive similarity computation in link prediction, the hashing technique has been successfully used to produce the node representation in the Hamming space. However, the hashing-based link prediction algorithms face accuracy loss from the randomized hashing techniques or inefficiency from the learning to hash techniques in the embedding process. Currently, the Graph Neural Network (GNN) framework has been widely applied to the graph-related tasks in an end-to-end manner, but it commonly requires substantial computational resources and memory costs due to massive parameter learning, which makes the GNN-based algorithms impractical without the help of a powerful workhorse. In this paper, we propose a simple and effective model called #GNN, which balances the trade-off between accuracy and efficiency. #GNN is able to efficiently acquire node representation in the Hamming space for link prediction by exploiting the randomized hashing technique to implement message passing and capture high-order proximity in the GNN framework. Furthermore, we characterize the discriminative power of #GNN in probability. The extensive experimental results demonstrate that the proposed #GNN algorithm achieves accuracy comparable to the learning-based algorithms and outperforms the randomized algorithm, while running significantly faster than the learning-based algorithms. Also, the proposed algorithm shows excellent scalability on a large-scale network with the limited resources. Wei Wu 0011, Bin Li 0015, Chuan Luo 0002, Wolfgang Nejdl

Extended Conjunctive Normal Form and An Efficient Algorithm for Cardinality ConstraintsabstractSatisfiability (SAT) and Maximum Satisfiability (MaxSAT) are two basic and important constraint problems with many important applications. SAT and MaxSAT are expressed in CNF, which is difficult to deal with cardinality constraints. In this paper, we introduce Extended Conjunctive Normal Form (ECNF), which expresses cardinality constraints straightforward and does not need auxiliary variables or clauses. Then, we develop a simple and efficient local search solver LS-ECNF with a well designed scoring function under ECNF. We also develop a generalized Unit Propagation (UP) based algorithm to generate the initial solution for local search. We encode instances from Nurse Rostering and Discrete Tomography Problems into CNF with three different cardinality constraint encodings and ECNF respectively. Experimental results show that LS-ECNF has much better performance than state of the art MaxSAT, SAT, Pseudo-Boolean and ILP solvers, which indicates solving cardinality constraints with ECNF is promising. | 2020 | Intelligent Virtual Machine Provisioning in Cloud ComputingabstractVirtual machine (VM) provisioning is a common and critical problem in cloud computing. In industrial cloud platforms, there are a huge number of VMs provisioned per day. Due to the complexity and resource constraints, it needs to be carefully optimized to make cloud platforms effectively utilize the resources. Moreover, in practice, provisioning a VM from scratch requires fairly long time, which would degrade the customer experience. Hence, it is advisable to provision VMs ahead for upcoming demands. In this work, we formulate the practical scenario as the predictive VM provisioning (PreVMP) problem, where upcoming demands are unknown and need to be predicted in advance, and then the VM provisioning plan is optimized based on the predicted demands. Further, we propose Uncertainty-Aware Heuristic Search (UAHS) for solving the PreVMP problem. UAHS first models the prediction uncertainty, and then utilizes the prediction uncertainty in optimization. Moreover, UAHS leverages Bayesian optimization to interact prediction and optimization to improve its practical performance. Extensive experiments show that UAHS performs much better than state-of-the-art competitors on two public datasets and an industrial dataset. UAHS has been successfully applied in Microsoft Azure and brought practical benefits in real-world applications. | 2020 | Efficient incident identification from multi-dimensional issue reports via meta-heuristic searchabstractIn large-scale cloud systems, unplanned service interruptions and outages may cause severe degradation of service availability. Such incidents can occur in a bursty manner, which will deteriorate user satisfaction. Identifying incidents rapidly and accurately is critical to the operation and maintenance of a cloud system. In industrial practice, incidents are typically detected through analyzing the issue reports, which are generated over time by monitoring cloud services. Identifying incidents in a large number of issue reports is quite challenging. An issue report is typically multi-dimensional: it has many categorical attributes. It is difficult to identify a specific attribute combination that indicates an incident. Existing methods generally rely on pruning-based search, which is time-consuming given high-dimensional data, thus not practical to incident detection in large-scale cloud systems. In this paper, we propose MID (Multi-dimensional Incident Detection), a novel framework for identifying incidents from large-amount, multi-dimensional issue reports effectively and efficiently. Key to the MID design is encoding the problem into a combinatorial optimization problem. Then a specific-tailored meta-heuristic search method is designed, which can rapidly identify attribute combinations that indicate incidents. We evaluate MID with extensive experiments using both synthetic data and real-world data collected from a large-scale production cloud system. The experimental results show that MID significantly outperforms the current state-of-the-art methods in terms of effectiveness and efficiency. Additionally, MID has been successfully applied to Microsoft's cloud systems and helped greatly reduce manual maintenance effort. | 2019 | Neural Feature Search: A Neural Architecture for Automated Feature EngineeringabstractFeature engineering is a crucial step for developing effective machine learning models. Traditionally, feature engineering is performed manually, which requires much domain knowledge and is time-consuming. In recent years, many automated feature engineering methods have been proposed. These methods improve the accuracy of a machine learning model by automatically transforming the original features into a set of new features. However, existing methods either lack ability to perform high-order transformations or suffer from the feature space explosion problem. In this paper, we present Neural Feature Search (NFS), a novel neural architecture for automated feature engineering. We utilize a recurrent neural network based controller to transform each raw feature through a series of transformation functions. The controller is trained through reinforcement learning to maximize the expected performance of the machine learning algorithm. | 2019 | Local Search with Efficient Automatic Configuration for Minimum Vertex CoverabstractMinimum vertex cover (MinVC) is a prominent NP-hard problem in artificial intelligence, with considerable importance in applications. Local search solvers define the state of the art in solving MinVC. However, there is no single MinVC solver that works best across all types of MinVC instances, and finding the most suitable solver for a given application poses considerable challenges. In this work, we present a new local search framework for MinVC called MetaVC, which is highly parametric and incorporates many effective local search techniques. Using an automatic algorithm configurator, the performance of MetaVC can be optimized for particular types of MinVC instances. Through extensive experiments, we demonstrate that MetaVC significantly outperforms previous solvers on medium-size hard MinVC instances, and shows competitive performance on large MinVC instances. We further introduce a neural-network-based approach for enhancing the automatic configuration process, by identifying and terminating unpromising configuration runs. Our results demonstrate that MetaVC, when automatically configured using this method, can achieve improvements in the best known solutions for 16 large MinVC instances. Chuan Luo 0002, Holger H. | 2019 | Towards more efficient meta-heuristic algorithms for combinatorial test generationabstractCombinatorial interaction testing (CIT) is a popular approach to detecting faults in highly configurable software systems. The core task of CIT is to generate a small test suite called a t-way covering array (CA), where t is the covering strength. Many meta-heuristic algorithms have been proposed to solve the constrained covering array generating (CCAG) problem. A major drawback of existing algorithms is that they usually need considerable time to obtain a good-quality solution, which hinders the wider applications of such algorithms. We observe that the high time consumption of existing meta-heuristic algorithms for CCAG is mainly due to the procedure of score computation. In this work, we propose a much more efficient method for score computation. The score computation method is applied to a state-of-the-art algorithm TCA, showing significant improvements. The new score computation method opens a way to utilize algorithmic ideas relying on scores which were not affordable previously. We integrate a gradient descent search step to further improve the algorithm, leading to a new algorithm called FastCA. Experiments on a broad range of real-world benchmarks and synthetic benchmarks show that, FastCA significantly outperforms state-of-the-art algorithms for CCAG algorithms, in terms of both the size of obtained covering array and the run time. Recently, great breakthroughs have been made on stochastic local search (SLS) for solving MAX-SAT, weighted MAX-SAT, PMS and WPMS, resulting in several state-of-the-art SLS algorithms, such as CCLS, Dist and CCEHC. | 2017 | Finding A Small Vertex Cover in Massive Sparse Graphs: Construct, Local Search, and PreprocessabstractThe problem of finding a minimum vertex cover (MinVC) in a graph is a well known NP-hard combinatorial optimization problem of great importance in theory and practice. Due to its NP-hardness, there has been much interest in developing heuristic algorithms for finding a small vertex cover in reasonable time. Previously, heuristic algorithms for MinVC have focused on solving graphs of relatively small size, and they are not suitable for solving massive graphs as they usually have high-complexity heuristics. This paper explores techniques for solving MinVC in very large scale real-world graphs, including a construction algorithm, a local search algorithm and a preprocessing algorithm. Both the construction and search algorithms are based on low-complexity heuristics, and we combine them to develop a heuristic algorithm for MinVC called FastVC. Experimental results on a broad range of real-world massive graphs show that, our algorithms are very fast and have better performance than previous heuristic algorithms for MinVC. We also develop a preprocessing algorithm to simplify graphs for MinVC algorithms. By applying the preprocessing algorithm to local search algorithms, we obtain two efficient MinVC solvers called NuMVC2+p and FastVC2+p, which show further improvement on the massive graphs. | 2015 | Improving WalkSAT By Effective Tie-Breaking and Efficient ImplementationabstractStochastic local search (SLS) algorithms are well known for their ability to efficiently find models of random instances of the Boolean satisfiability (SAT) problem. One of the most famous SLS algorithms for SAT is WalkSAT, which is an initial algorithm that has wide influence and performs very well on random 3-SAT instances. However, the performance of WalkSAT on random k-SAT instances with k > 3 lags far behind. Indeed, there are limited works on improving SLS algorithms for such instances. This work takes a good step toward this direction. We propose a novel concept namely multilevel make. Based on this concept, we design a scoring function called linear make, which is utilized to break ties in WalkSAT, leading to a new algorithm called WalkSATlm. Our experimental results show that WalkSATlm improves WalkSAT by orders of magnitude on random k-SAT instances with k > 3 near the phase transition. Additionally, we propose an efficient implementation for WalkSATlm, which leads to a speedup of 100%. | 2015 | CCLS: An Efficient Local Search Algorithm for Weighted Maximum SatisfiabilityabstractThe maximum satisfiability (MAX-SAT) problem, especially the weighted version, has extensive applications. Weighted MAX-SAT instances encoded from real-world applications may be very large, which calls for efficient approximate methods, mainly stochastic local search (SLS) ones. However, few works exist on SLS algorithms for weighted MAX-SAT. In this paper, we propose a new heuristic called CCM for weighted MAX-SAT. The CCM heuristic prefers to select a CCMP variable. By combining CCM with random walk, we design a simple SLS algorithm dubbed CCLS for weighted MAX-SAT. The CCLS algorithm is evaluated against a state-of-the-art SLS solver IRoTS and two state-of-the-art complete solvers namely akmaxsat_ls and New WPM2, on a broad range of weighted MAX-SAT instances. Experimental results illustrate that the quality of solution found by CCLS is much better than that found by IRoTS, akmaxsat_ls and New WPM2 on most industrial, crafted and random instances, indicating the efficiency and the robustness of the CCLS algorithm. Furthermore, CCLS is evaluated in the weighted and unweighted MAX-SAT tracks of incomplete solvers in the Eighth Max-SAT Evaluation (Max-SAT 2013), and wins four tracks in this evaluation, illustrating that the performance of CCLS exceeds the current state-of-the-art performance of SLS algorithms on solving MAX-SAT instances. | 2015 | Clause States Based Configuration Checking in Local Search for SatisfiabilityabstractTwo-mode stochastic local search (SLS) and focused random walk (FRW) are the two most influential paradigms of SLS algorithms for the propositional satisfiability (SAT) problem. Recently, an interesting idea called configuration checking (CC) was proposed to handle the cycling problem in SLS. The CC idea has been successfully used to improve SLS algorithms for SAT, resulting in state-of-the-art solvers. Previous CC strategies for SAT are based on neighboring variables, and prove successful in two-mode SLS algorithms. However, this kind of neighboring variables based CC strategy is not suitable for improving FRW algorithms. In this paper, we propose a new CC strategy which is based on clause states. We apply this clause states based CC (CSCC) strategy to both two-mode SLS and FRW paradigms. Our experiments show that the CSCC strategy is effective on both paradigms. | 2014 | Double Configuration Checking in Stochastic Local Search for SatisfiabilityabstractStochastic local search (SLS) algorithms have shown effectiveness on satisfiable instances of the Boolean satisfiability (SAT) problem. However, their performance is still unsatisfactory on random k-SAT at the phase transition, which is of significance and is one of the empirically hardest distributions of SAT instances. In this paper, we propose a new heuristic called DCCA, which combines two configuration checking (CC) strategies with different definitions of configuration in a novel way. We use the DCCA heuristic to design an efficient SLS solver for SAT dubbed DCCASat. The experiments show that the DCCASat solver significantly outperforms a number of state-of-the-art solvers on extensive random k-SAT benchmarks at the phase transition. Moreover, DCCASat shows good performance on structured benchmarks, and a combination of DCCASat with a complete solver achieves state-of-the-art performance on structured benchmarks. | 2014 | Scoring Functions Based on Second Level Score for k-SAT with Long ClausesabstractIt is widely acknowledged that stochastic local search (SLS) algorithms can efficiently find models for satisfiable instances of the satisfiability (SAT) problem, especially for random k-SAT instances. However, compared to random 3-SAT instances where SLS algorithms have shown great success, random k-SAT instances with long clauses remain very difficult. Recently, the notion of second level score, denoted as "score_2", was proposed for improving SLS algorithms on long-clause SAT instances, and was first used in the powerful CCASat solver as a tie breaker. In this paper, we propose three new scoring functions based on score_2. Despite their simplicity, these functions are very effective for solving random k-SAT with long clauses. The first function combines score and score_2, and the second one additionally integrates the diversification property "age". These two functions are used in developing a new SLS algorithm called CScoreSAT. Experimental results on large random 5-SAT and 7-SAT instances near phase transition show that CScoreSAT significantly outperforms previous SLS solvers. However, CScoreSAT cannot rival its competitors on random k-SAT instances at phase transition. We improve CScoreSAT for such instances by another scoring function which combines score_2 with age. The resulting algorithm HScoreSAT exhibits state-of-the-art performance on random k-SAT (k>3) instances at phase transition. We also study the computation of score_2, including its implementation and computational complexity. Shaowei Cai 0001, Chuan Luo 0002, Kaile Su

Improving WalkSAT for Random k-Satisfiability Problem with k > 3abstractStochastic local search (SLS) algorithms are well known for their ability to efficiently find models of random instances of the Boolean satisfiablity (SAT) problem. One of the most famous SLS algorithms for SAT is WalkSAT, which is an initial algorithm that has wide influence among modern SLS algorithms. Recently, there has been increasing interest in WalkSAT, due to the discovery of its great power on large random 3-SAT instances. However, the performance of WalkSAT on random $k$-SAT instances with $k>3$ lags far behind. Indeed, there have been few works in improving SLS algorithms for such instances. This work takes a large step towards this direction. We propose a novel concept namely $multilevel$ $make$. Based on this concept, we design a scoring function called $linear$ $make$, which is utilized to break ties in WalkSAT, leading to a new algorithm called WalkSAT$lm$. Our experimental results on random 5-SAT and 7-SAT instances show that WalkSAT$lm$ improves WalkSAT by orders of magnitudes. Moreover, WalkSAT$lm$ significantly outperforms state-of-the-art SLS solvers on random 5-SAT instances, while competes well on random 7-SAT ones. Additionally, WalkSAT$lm$ performs very well on random instances from SAT Challenge 2012, indicating its robustness. Shaowei Cai 0001, Kaile Su, Chuan Luo 0002

NuMVC: An Efficient Local Search Algorithm for Minimum Vertex CoverabstractThe Minimum Vertex Cover (MVC) problem is a prominent NP-hard combinatorial optimization problem of great importance in both theory and application. Local search has proved successful for this problem. However, there are two main drawbacks in state-of-the-art MVC local search algorithms. First, they select a pair of vertices to exchange simultaneously, which is time-consuming. Secondly, although using edge weighting techniques to diversify the search, these algorithms lack mechanisms for decreasing the weights. To address these issues, we propose two new strategies: two-stage exchange and edge weighting with forgetting. The two-stage exchange strategy selects two vertices to exchange separately and performs the exchange in two stages. The strategy of edge weighting with forgetting not only increases weights of uncovered edges, but also decreases some weights for each edge periodically. These two strategies are used in designing a new MVC local search algorithm, which is referred to as NuMVC. We conduct extensive experimental studies on the standard benchmarks, namely DIMACS and BHOSLIB. The experiment comparing NuMVC with state-of-the-art heuristic algorithms show that NuMVC is at least competitive with the nearest competitor namely PLS on the DIMACS benchmark, and clearly dominates all competitors on the BHOSLIB benchmark. Also, experimental results indicate that NuMVC finds an optimal solution much faster than the current best exact algorithm for Maximum Clique on random instances as well as some structured ones. Moreover, we study the effectiveness of the two strategies and the run-time behaviour through experimental analysis. Shaowei Cai 0001, Kaile Su, Chuan Luo 0002, Abdul Sattar 0001
