Utilizing Text Mining on Online Medical Forums to Predict Label Change due to Adverse Drug ReactionsabstractWe present an end-to-end text mining methodology for relation extraction of adverse drug reactions (ADRs) from medical forums on the Web. Our methodology is novel in that it combines three major characteristics: (i) an underlying concept of using a head-driven phrase structure grammar (HPSG) based parser; (ii) domain-specific relation patterns, the acquisition of which is done primarily using unsupervised methods applied to a large, unlabeled text corpus; and (iii) automated post-processing algorithms for enhancing the set of extracted relations. We empirically demonstrate the ability of our proposed approach to predict ADRs prior to their reporting by the Food and Drug Administration (FDA). Put differently, we put our approach to a predictive test by demonstrating that our methodology can credibly point to ADRs that were not uncovered in clinical trials for evaluating new drugs that come to market but were only reported later on by the FDA as a label change. | 2011 | The Stock Sonar - Sentiment Analysis of Stocks Based on a Hybrid ApproachabstractThe Stock Sonar (TSS) is a stock sentiment analysis application based on a novel hybrid approach. While previous work focused on document level sentiment classification, or extracted only generic sentiment at the phrase level, TSS integrates sentiment dictionaries, phrase-level compositional patterns, and predicate-level semantic events. TSS generates precise in-text sentiment tagging as well as sentiment-oriented event summaries for a given stock, which are also aggregated into sentiment scores. Hence, TSS allows investors to get the essence of thousands of articles every day and may help them to make timely, informed trading decisions. The extracted sentiment is also shown to improve the accu- racy of an existing document-level sentiment classifier. Ronen Feldman, Benjamin Rozenfeld, Roy Bar-Haim, Moshe Fresko

Using sequence classification for filtering web pagesabstractWeb pages often contain text that is irrelevant to their main content, such as advertisements, generic format elements, and references to other pages on the same site. When used by automatic content-processing systems, e.g., for Web indexing, text classification, or information extraction, this irrelevant text often produces substantial amount of noise. This paper describes a trainable filtering system based on a feature-rich sequence classifier that removes irrelevant parts from pages, while keeping the content intact. Most of the features the system uses are purely form-related: HTML tags and their positions, sizes of elements, etc. This keeps the system general and domain-independent. We also experiment with content words and show that while they perform very poorly alone, they can slightly improve the performance of pure-form features, without jeopardizing the domain-independence. Our system achieves very high accuracy (95% and above) on several collections of Web pages. We also do a series of tests with different features and different classifiers, comparing the contribution of different components to the system performance, and comparing two known sequence classifiers, Robust Risk Minimization (RRM) and Conditional Random Fields (CRF), in a novel setting. | 2007 | Clustering for unsupervised relation identificationabstractUnsupervised Relation Identification is the task of automatically discovering interesting relations between entities in a large text corpora. Relations are identified by clustering the frequently co-occurring pairs of entities in such a way that pairs occurring in similar contexts end up belonging to the same clusters. In this paper we compare several clustering setups, some of them novel and others already tried. The setups include feature extraction and selection methods and clustering algorithms. In order to do the comparison, we develop a clustering evaluation metric, specifically adapted for the relation identification task. Our experiments demonstrate significant superiority of the single-linkage hierarchical clustering with the novel threshold selection technique over the other tested clustering algorithms. Also, the experiments indicate that for successful relation identification it is important to use rich complex features of two kinds: features that test both relation slots together (relation features), and features that test only one slot each (entity features). We have found that using both kinds of features with the best of the algorithms produces very high-precision results, significantly improving over the previous work. | 2007 | Extracting Product Comparisons from Discussion BoardsabstractIn recent years, product discussion forums have become a rich environment in which consumers and potential adopters exchange views and information. Researchers and practitioners are starting to extract user sentiment about products from user product reviews. Users often compare different products, stating which they like better and why. Extracting information about product comparisons offers a number of challenges; recognizing and normalizing entities (products) in the informal language of blogs and discussion groups require different techniques than those used for entity extraction in the more formal text of newspapers and scientific articles. We present a case study in extracting information about comparisons between running shoes and between cars, describe an effective methodology, and show how it produces insight into how consumers view the running shoe and car markets. | 2006 | High-Performance Unsupervised Relation Extraction from Large CorporaabstractWe present URIES - an unsupervised relation identification and extraction system. The system automatically identifies interesting binary relations between entities in the input corpus, and then proceeds to extract a large number of instances of these relations. The system discovers relations by clustering frequently co- occuring pairs of entities, based on the contexts in which they appear. Its complex pattern-based representation of the contexts allows the clustering step to achieve very high precision, sufficient for the clusters to perform as sets of seeds for bootstrapping a high-recall relation extraction process. In a series of experiments we demonstrate the successful performance of URIES and compare it to the two existing systems - a weakly supervised high-recall Web relation extraction system called SRES, and an unsupervised relation identification system that uses a simpler bag-ofwords representation of contexts. The experiments show that URIES performs comparably to SRES, but without any supervision, and that such performance is due to the power of its complex contexts representation and to its novel candidate selection method. | 2006 | A Systematic Cross-Comparison of Sequence ClassifiersabstractIn the CoNLL 2003 NER shared task, more than two thirds of the submitted systems used a feature-rich representation of the task. Most of them used the maximum entropy principle to combine the features together. Others used large margin linear classifiers, such as SVM and RRM. In this paper, we compare several common classifiers under exactly the same conditions, demonstrating that the ranking of systems in the shared task is due to feature selection and other causes and not due to inherent qualities of the algorithms, which should be ranked otherwise. We demonstrate that whole-sequence models generally outperform local models, and that large margin classifiers generally outperform maximum entropy-based classifiers. | 2005 | A hybrid approach to NER by MEMM and manual rulesabstractThis paper describes a framework for defining domain specific Feature Functions in a user friendly form to be used in a Maximum Entropy Markov Model (MEMM) for the Named Entity Recognition (NER) task. Our system called MERGE allows defining general Feature Function Templates, as well as Linguistic Rules incorporated into the classifier. The simple way of translating these rules into specific feature functions are shown. We show that MERGE can perform better from both purely machine learning based systems and purely-knowledge based approaches by some small expert interaction of rule-tuning. | 2004 | TEG: a hybrid approach to information extractionabstractThis paper describes a hybrid statistical and knowledge-based information extraction model, able to extract entities and relations at the sentence level. The model attempts to retain and improve the high accuracy levels of knowledge-based systems while drastically reducing the amount of manual labor by relying on statistics drawn from a training corpus. The implementation of the model, called TEG (Trainable Extraction Grammar), can be adapted to any IE domain by writing a suitable set of rules in a SCFG (Stochastic Context Free Grammar) based extraction language, and training them using an annotated corpus. The system does not contain any purely linguistic components, such as PoS tagger or parser. We demonstrate the performance of the system on several named entity extraction and relation extraction tasks. The experiments show that our hybrid approach outperforms both purely statistical and purely knowledge-based systems, while requiring orders of magnitude less manual rule writing and smaller amount of training data. The improvement in accuracy is slight for named entity extraction task and more pronounced for relation extraction. Binyamin Rosenfeld, Ronen Feldman, Moshe Fresko, Jonathan Schler, Yonatan Aumann

Structural extraction from visual layout of documentsabstractMost information extraction systems focus on the textual content of the documents. They treat documents as sequences or of words, disregarding the physical and typographical layout of the information.. While this strategy helps in focusing the extraction process on the key semantic content of the document, much valuable information can also be derived form the document physical appearance. Often, fonts, physical positioning and other graphical characteristics are used to provide additional context to the information. This information is lost with pure-text analysis. In this paper we describe a general procedure for structural extraction, which allows for automatic extraction of entities from the document based on their visual characteristics and relative position in the document layout. Our structural extraction procedure is a learning algorithm, which knows how to automatically generalizes from examples. The procedure is a general one, applicable to any document format with visual and typographical information. We also then describe a specific implementation of the procedure to PDF documents, called PES (PDF Extraction System). PES works with PDF documents and is able to extract such fields such as Author(s), Title, Date, etc. with very high accuracy. Binyamin Rosenfeld, Ronen Feldman, Yonatan Aumann

A Domain Independent Environment for Creating Information Extraction ModulesabstractText-Mining is a growing area of interest within the field of Data Mining and Knowledge Discovery. Given a collection of text documents, most approaches to Text Mining perform knowledgediscovery operations either on external tags associated with each document, or on the set of all words within each document. Both approaches suffer from limitations. This paper focuses on an intermediate approach, one that we call text mining via information extraction, in which knowledge discovery takes place on focused, relevant terms, phrases and facts, as extracted from the documents. | 2000 | A framework for specifying explicit bias for revision of approximate information extraction rulesabstractInformation extraction is one of the most important techniques used in Text Mining. One of the main problems in building information extraction (IE) systems is that the knowledge elicited from domain experts tends to be only approximately correct. In addition, the knowledge acquisition phase for building IE rules usually takes a tremendous amount of time on the part of the expert and of the linguist creating the rules. We therefore need an effective means of revising our IE rules whenever we discover such an inaccuracy. The IE revision problem is how best to go about revising a deficient IE rules using information contained in examples that expose inaccuracies. The revision process is very sensitive to implicit and explicit biases encoded in the specific revision algorithm employed. In a sense, each revision algorithm must provide two forms of biases: bias as to the place of the revision and bias as to the type of the revision that should be performed. In this paper we present a framework for writing approximate IE rules that are provided with explicit bias. The proposed framework can be used by many existing revision algorithms. The purpose of the revision bias framework is to allow the user to declare his own bias in a simple and structured way, i.e. to express the conditions placed on the domain knowledge for a given revision operator to be applied. This language extends and generalizes the work reported in [Feldman et. al. 1993]. It attacks the problem of writing IE rules from a novel perspective, one which enables a much faster development of IE systems. | 1994 | Bias-Driven Revision of Logical Domain TheoriesabstractThe theory revision problem is the problem of how best to go about revising a deficient domain theory using information contained in examples that expose inaccuracies. In this paper we present our approach to the theory revision problem for propositional domain theories. The approach described here, called PTR, uses probabilities associated with domain theory elements to numerically track the ``flow'' of proof through the theory. This allows us to measure the precise role of a clause or literal in allowing or preventing a (desired or undesired) derivation for a given example. This information is used to efficiently locate and repair flawed elements of the theory. PTR is proved to converge to a theory which correctly classifies all examples, and shown experimentally to be fast and accurate even for deep theories. Moshe Koppel, Ronen Feldman, Alberto M. Segre

Optimization Algorithms for Student Scheduling via Constraint SatisfiabilityabstractTechniques for solving constraint satisfiability problems have received much attention in artificial intelligence, operation research and symbolic logic. Applications which may be viewed as CSPs are found in scene identification in computer vision, space and motion planning, database consistency, combinatorial optimization, and cryptarithm puzzle solving. Our research effort attempts to determine which algorithms perform best, and under what conditions, in solving a special CSP known as the student scheduling problem (SSP). Since constraint satisfiability problems are, in general, NP-complete, it is of interest to develop and compare the effectiveness and efficiency of heuristic algorithms as applied, in particular, to our application. In this paper, we assign priorities to the constraints and investigate optimization algorithms for finding schedules which rank high with respect to the priorities. Experimental results have been collected and are reported here. Our system was developed for and used at Bar-Ilan University during the registration period, being available for students to construct their timetables. Ronen Feldman, Martin Charles Golumbic
