| 2025 | Performance Characterization of CXL Memory and Its Use CasesabstractCompute eXpress Link (CXL) is emerging as a promising memory interface technology. However, its performance characteristics remain largely unclear due to the limited availability of production hardware. Key questions include: What are the use cases for the CXL memory? What are the impacts of the CXL memory on application performance? How to use the CXL memory in combination with existing memory components? In this work, we study the performance of three genuine CXL memory-expansion cards from different vendors. We characterize the basic performance of the CXL memory, study how HPC applications and large language models (LLM) can benefit from the CXL memory, and study the interplay between memory tiering and page interleaving. We also propose a novel data object-level interleaving policy to match the interleaving policy with memory access patterns. | 2023 | Merchandiser: Data Placement on Heterogeneous Memory for Task-Parallel HPC Applications with Load-Balance AwarenessabstractThe emergence of heterogeneous memory (HM) provides a cost-effective and high-performance solution to memory-consuming HPC applications. Deciding the placement of data objects on HM is critical for high performance. We reveal a performance problem related to data placement on HM. The problem is manifested as load imbalance among tasks in task-parallel HPC applications. The root of the problem comes from being unaware of parallel-task semantics and an incorrect assumption that bringing frequently accessed pages to fast memory always leads to better performance. To address this problem, we introduce a load balance-aware page management system, named Merchandiser. Merchandiser introduces task semantics during memory profiling, rather than being application-agnostic. Using the limited task semantics, Merchandiser effectively sets up coordination among tasks on the usage of HM to finish all tasks fast instead of only considering any individual task. Merchandiser is highly automated to enable high usability. Evaluating with memory-consuming HPC applications, we show that Merchandiser reduces load imbalance and leads to an average of 17.1% and 15.4% (up to 26.0% and 23.2%) performance improvement, compared with a hardware-based solution and an industry-quality software-based solution. | 2022 | Lobster: Load Balance-Aware I/O for Distributed DNN TrainingabstractThe resource-hungry and time-consuming process of training Deep Neural Networks (DNNs) can be accelerated by optimizing and/or scaling computations on accelerators such as GPUs. However, the loading and pre-processing of training samples then often emerges as a new bottleneck. This data loading process engages a complex pipeline that extends from the sampling of training data on external storage to delivery of those data to GPUs, and that comprises not only expensive I/O operations but also decoding, shuffling, batching, augmentation, and other operations. We propose in this paper a new holistic approach to data loading that addresses three challenges not sufficiently addressed by other methods: I/O load imbalances among the GPUs on a node; rigid resource allocations to data loading and data preprocessing steps, which lead to idle resources and bottlenecks; and limited efficiency of caching strategies based on pre-fetching due to eviction of training samples needed soon at the expense of those needed later. We first present a study of key bottlenecks observed as training samples flow through the data loading and preprocessing pipeline. Then, we describe Lobster, a data loading runtime that uses performance modeling and advanced heuristics to combine flexible thread management with optimized eviction for distributed caching in order to mitigate I/O overheads and load imbalances. | 2021 | MD-HM: memoization-based molecular dynamics simulations on big memory systemabstractMolecular dynamics (MD) simulation is a fundamental method for modeling ensembles of particles. In this paper, we introduce a new method to improve the performance of MD by leveraging the emerging TB-scale big memory system. In particular, we trade memory capacity for computation capability to improve MD performance by the lookup table-based memoization technique. The traditional memoization technique for the MD simulation uses relatively small DRAM, bases on a suboptimal data structure, and replaces pair-wise computation, which leads to limited performance benefit in the big memory system. We introduce MD-HM, a memoization-based MD simulation framework customized for the big memory system. MD-HM partitions the simulation field into subgrids, and replaces computation in each subgrid as a whole based on a lightweight pattern-match algorithm to recognize computation in the subgrid. MD-HM uses a new two-phase LSM-tree to optimize read/write performance. Evaluating with nine MD simulations, we show that MD-HM outperforms the state-of-the-art LAMMPS simulation framework with an average speedup of 7.6x based on the Intel Optane-based big memory system. | 2021 | Fauce: Fast and Accurate Deep Ensembles with Uncertainty for Cardinality EstimationabstractCardinality estimation is a fundamental and critical problem in databases. Recently, many estimators based on deep learning have been proposed to solve this problem and they have achieved promising results. However, these estimators struggle to provide accurate results for complex queries, due to not capturing real inter-column and inter-table correlations. Furthermore, none of these estimators contain the uncertainty information about their estimations. In this paper, we present a join cardinality estimator called Fauce. Fauce learns the correlations across all columns and all tables in the database. It also contains the uncertainty information of each estimation. Among all studied learned estimators, our results are promising: (1) Fauce is a light-weight estimator, it has 10× faster inference speed than the state of the art estimator; (2) Fauce is robust to the complex queries, it provides 1.3×--6.7× smaller estimation errors for complex queries compared with the state of the art estimator; (3) To the best of our knowledge, Fauce is the first estimator that incorporates uncertainty information for cardinality estimation into a deep learning model. | 2019 | Performance Analysis and Characterization of Training Deep Learning Models on Mobile DeviceabstractTraining deep learning models on mobile devices recently becomes possible, because of increasing computation power on mobile hardware and the advantages of enhancing user experiences. Most of the existing work on machine learning at mobile devices is focused on the inference of deep learning models, but not training. The performance characterization of training deep learning models on mobile devices is largely unexplored, although understanding the performance characterization is critical for designing and implementing deep learning models on mobile devices. In this paper, we perform a variety of experiments on a representative mobile device (the NVIDIA TX2) to study the performance of training deep learning models. We introduce a benchmark suite and a tool to study performance of training deep learning models on mobile devices, from the perspectives of memory consumption, hardware utilization, and power consumption. The tool can correlate performance results with fine-grained operations in deep learning models, providing capabilities to capture performance variance and problems at a fine granularity. We reveal interesting performance problems and opportunities, including under-utilization of heterogeneous hardware, large energy consumption of the memory, and high predictability of workload characterization. | 2019 | Adaptive neural network-based approximation to accelerate eulerian fluid simulationabstractThe Eulerian fluid simulation is an important HPC application. The neural network has been applied to accelerate it. The current methods that accelerate the fluid simulation with neural networks lack flexibility and generalization. In this paper, we tackle the above limitation and aim to enhance the applicability of neural networks in the Eulerian fluid simulation. We introduce Smart-fluidnet, a framework that automates model generation and application. Given an existing neural network as input, Smart-fluidnet generates multiple neural networks before the simulation to meet the execution time and simulation quality requirement. During the simulation, Smart-fluidnet dynamically switches the neural networks to make best efforts to reach the user's requirement on simulation quality. Evaluating with 20,480 input problems, we show that Smart-fluidnet achieves 1.46x and 590x speedup comparing with a state-of-the-art neural network model and the original fluid simulation respectively on an NVIDIA Titan X Pascal GPU, while providing better simulation quality than the state-of-the-art model.
