| 2025 | Frequency-Biased Synergistic Design for Image Compression and CompensationabstractCompression artifacts removal (CAR), an effective post-processing method to reduce compression distortion in edge-side codecs, demonstrates remarkable results by utilizing convolutional neural networks (CNNs) on high computational power cloud side. Traditional image compression reduces redundancy in the frequency domain, and we observed that CNNs also exhibit a bias in frequency domain when handling compression distortions. However, no prior research leverages this frequency bias to design compression methods tailored to CAR CNNs, or vice versa. In this paper, we present a synergistic design that bridges the gap between image compression and learnable compensation for CAR. Our investigation reveals that different compensation networks have varying effects on low and high-frequencies. Building upon these insights, we propose a pioneering redesign of the quantization process, a fundamental component in lossy image compression, to more effectively compress low-frequency information. Additionally, we devise a novel compensation framework that applies different neural networks for reconstructing different frequencies, incorporating a basis attention block to prioritize intentionally dropped low-frequency information, thereby enhancing the overall compensation. We instantiate two compensation networks based on this synergistic design and conduct extensive experiments on three image compression standards, demonstrating that our approach significantly reduces bitrate consumption while delivering high perceptual quality. | 2025 | A Tightly Coupled AI-ISP Vision ProcessorabstractTo achieve high-quality and high-resolution image processing, this work presents a novel vision processor that facilitates deep learning-enhanced image processing pipelines. At the system level, by identifying that a divide-and-conquer approach is essential to synergize both classical image processing and image enhancement networks, we develop a tightly coupled system with strip-tile conversion dataflow to enable fine-grained low-latency data interactions between image signal processors (ISPs) and the deep learning accelerator (DLA). At the architecture level, we design a comprehensive set of 21 efficient image processing modules to construct classical ISP pipelines, a tile-based strip layer fusion DLA specifically optimized for networks, and a programmable pixel pool that seamlessly supports the data access patterns of the ISP and the DLA. At the software and hardware co-design level, we propose a comprehensive optimization framework to address the implementation overhead of networks while maintaining the image quality. Finally, evaluations of the AI-ISP vision processor demonstrate 53.95% external memory access reduction and 35.51% latency reduction, delivering superior image quality with minimal on-chip memory overhead. A throughput of up to 168.5 frames per second facilitates efficient processing of ultra-high definition (UHD) resolution images. | 2024 | Zero-Shot Structure-Preserving Diffusion Model for High Dynamic Range Tone MappingabstractTone mapping techniques, aiming to convert high dynamic range (HDR) images to high-quality low dynamic range (LDR) images for display, play a more crucial role in real-world vision systems with the increasing application of HDR images. However, obtaining paired HDR and high-quality LDR images is difficult, posing a challenge to deep learning based tone mapping methods. To over-come this challenge, we propose a novel zero-shot tone mapping framework that utilizes shared structure knowl-edge, allowing us to transfer a pre-trained mapping model from the LDR domain to HDR fields without paired training data. Our approach involves decomposing both the LDR and HDR images into two components: structural in-formation and tonal information. To preserve the original image's structure, we modify the reverse sampling process of a diffusion model and explicitly incorporate the struc-ture information into the intermediate results. Additionally, for improved image details, we introduce a dual-control network architecture that enables different types of conditional inputs to control different scales of the output. Experimental results demonstrate the effectiveness of our approach, surpassing previous state-of-the-art methods both qualitatively and quantitatively. | 2024 | Explainable Fuzzy Neural Network with Multi-Fidelity Reinforcement Learning for Micro-Architecture Design Space ExplorationabstractWith the continuous advancement of processors, modern micro-architecture designs have become increasingly complex. The vast design space presents significant challenges for human designers, making design space exploration (DSE) algorithms a significant tool for μ-arch design. In recent years, efforts have been made in the development of DSE algorithms, and promising results have been achieved. However, the existing DSE algorithms, e.g., Bayesian Optimization and ensemble learning, suffer from poor interpretability, hindering designers' understanding of the decision-making process. To address this limitation, we propose utilizing Fuzzy Neural Networks to induce and summarize knowledge and insights from the DSE process, enhancing interpretability and controllability. Furthermore, to improve efficiency, we introduce a multi-fidelity reinforcement learning approach, which primarily conducts exploration using cheap but less precise data, thereby substantially diminishing the reliance on costly data. | 2024 | A Modular Branch Predictor Performance Analysis Framework for Fast Design Space ExplorationabstractAs modern processor designs scale up and workloads become more complex, the selection of the branch predictor (BP) and the optimization of its internal parameters are increasingly critical in striking a balance between performance and resource usage. However, current fast performance evaluation models and micro-architectural Design Space Exploration (DSE) frameworks provide limited support for BP components, especially regarding internal parameter adjustments. In this work, we propose a modular BP performance analysis framework that provides fast performance feedback for different BP configurations. Our framework includes a pattern analyzer equipped with more accurate metrics for quantifying an application's predictability of branch behavior, a classification module for selecting the appropriate BP type, and an analytical model set that reflects the impact of internal parameter adjustments of various BPs on both performance and storage resource usage, thereby supporting DSE. | 2023 | Efficient Super-Resolution System With Block-Wise Hybridization and Quantized Winograd on FPGAabstractSuper-resolution (SR) techniques aim to restore a high-resolution (HR) image from low-resolution (LR) images, which are often used to assist the enhancement of image/video quality under the rapid development of HR and high-frame-rate media. Recently, neural network (NN)-based methods perform much better image reconstruction quality than classical approaches. However, the unacceptable computation complexity as well as the huge memory footprints of NNs limit the throughputs and scalability of these SR systems. In this work, we analyze several key issues in the design of NN-based SR systems first. Then, we propose a three-level systematic optimization methodology for SR systems to reduce computation overhead and keep image quality. At the algorithm level, we introduce image blocking to SR tasks and develop a block-wise SR algorithm based on the hybrid of NN and interpolation with a consistent image block evaluation metric. The configurable hybrid parameters help the SR algorithm to achieve a flexible tradeoff between the computation overhead and image quality. At the operator level, we focus on the transpose convolution operators commonly used for upsampling in SR NNs. We propose an efficient Winograd-based transposed convolution acceleration method. Through the efficient subconvolutions conversion and the Winograd specialization, this methods enables unified Winograd transformations and simplified data access patterns. At the data level, we propose a novel quantization method for Winograd-aware SR NNs to get better-quantized accuracy. Comprehensive evaluations demonstrate the effectiveness of these optimizations. | 2022 | MIA-Former: Efficient and Robust Vision Transformers via Multi-Grained Input-AdaptationabstractVision transformers have recently demonstrated great success in various computer vision tasks, motivating a tremendously increased interest in their deployment into many real-world IoT applications. However, powerful ViTs are often too computationally expensive to be fitted onto real-world resource-constrained platforms, due to (1) their quadratically increased complexity with the number of input tokens and (2) their overparameterized self-attention heads and model depth. In parallel, different images are of varied complexity and their different regions can contain various levels of visual information, e.g., a sky background is not as informative as a foreground object in object classification tasks, indicating that treating those regions equally in terms of model complexity is unnecessary while such opportunities for trimming down ViTs' complexity have not been fully exploited. To this end, we propose a Multi-grained Input-Adaptive Vision Transformer framework dubbed MIA-Former that can input-adaptively adjust the structure of ViTs at three coarse-to-fine-grained granularities (i.e., model depth and the number of model heads/tokens). In particular, our MIA-Former adopts a low-cost network trained with a hybrid supervised and reinforcement learning method to skip the unnecessary layers, heads, and tokens in an input adaptive manner, reducing the overall computational cost. Furthermore, an interesting side effect of our MIA-Former is that its resulting ViTs are naturally equipped with improved robustness against adversarial attacks over their static counterparts, because MIA-Former's multi-grained dynamic control improves the model diversity similar to the effect of ensemble and thus increases the difficulty of adversarial attacks against all its sub-models. Extensive experiments and ablation studies validate that the proposed MIA-Former framework can (1) effectively allocate adaptive computation budgets to the difficulty of input images, achieving state-of-the-art (SOTA) accuracy-efficiency trade-offs, e.g., up to 16.5\% computation savings with the same or even a higher accuracy compared with the SOTA dynamic transformer models, and (2) boost ViTs' robustness accuracy under various adversarial attacks over their vanilla counterparts by 2.4\% and 3.0\%, respectively. | 2020 | ShiftAddNet: A Hardware-Inspired Deep NetworkabstractMultiplication (e.g., convolution) is arguably a cornerstone of modern deep neural networks (DNNs). However, intensive multiplications cause expensive resource costs that challenge DNNs' deployment on resource-constrained edge devices, driving several attempts for multiplication-less deep networks. This paper presented ShiftAddNet, whose main inspiration is drawn from a common practice in energy-efficient hardware implementation, that is, multiplication can be instead performed with additions and logical bit-shifts. We leverage this idea to explicitly parameterize deep networks in this way, yielding a new type of deep network that involves only bit-shift and additive weight layers. This hardware-inspired ShiftAddNet immediately leads to both energy-efficient inference and training, without compromising the expressive capacity compared to standard DNNs. The two complementary operation types (bit-shift and add) additionally enable finer-grained control of the model's learning capacity, leading to more flexible trade-off between accuracy and (training) efficiency, as well as improved robustness to quantization and pruning. We conduct extensive experiments and ablation studies, all backed up by our FPGA-based ShiftAddNet implementation and energy measurements. | 2019 | Ultra-thin Skin Electronics for High Quality and Continuous Skin-Sensor-Silicon InterfacingabstractSkin-inspired electronics emerges as a new paradigm due to the increasing demands for conformable and high-quality skin-sensor-silicon (SSS) interfacing in wearable, electronic skin and health monitoring applications. Advances in ultra-thin, flexible, stretchable and conformable materials have made skin electronics feasible. In this paper, we prototyped an active electrode (with a thickness ≤ 2 um), which integrates the electrode with a thin-film transistor (TFT) based amplifier, to effectively suppress motion artifacts. The fabricated ultra-thin amplifier can achieve a gain of 32 dB at 20 kHz, demonstrating the feasibility of the proposed active electrode. Using atrial fibrillation (AF) detection for electrocardiogram (ECG) as an application driver, we further develop a simulation framework taking into account all elements including the skin, the sensor, the amplifier and the silicon chip. Systematic and quantitative simulation results indicate that the proposed active electrode can effectively improve the signal quality under motion noises (achieving ≥30 dB improvement in signal-to-noise ratio (SNR)), which boosts classification accuracy by more than 19% for AF detection. | 2019 | Process Design Kit and Design Automation for Flexible Hybrid ElectronicsabstractHigh-performance low-cost flexible hybrid electronics (FHE) are desirable for internet of things (IoT). Carbon-nanotube (CNT) thin-film transistor (TFT) is a promising candidate for high-performance FHE because of its high carrier mobility (25cm2/V.s), superior mechanical flexibility/stretchability, and material compatibility with low-cost printing and solution processes. Flexible sensors and peripheral CNT-TFT circuits, such as decoders, drivers and sense amplifiers, can be printed and integrated with thinned (<;50μm) silicon chips on soft, thin, and flexible substrates for appealing product designs and form factors. | 2017 | Understanding the design of IBM neurosynaptic system and its tradeoffs: A user perspectiveabstractAs a large-scale commercial spiking-based neuromorphic computing platform, IBM TrueNorth processor received tremendous attentions in society. However, one of the known issues in TrueNorth design is the limited precision of synaptic weights. The current workaround is running multiple neural network copies in which the average value of each synaptic weight is close to that in the original network. We theoretically analyze the impacts of low data precision in the TrueNorth chip on inference accuracy, core occupation, and performance, and present a probability-biased learning method to enhance the inference accuracy through reducing the random variance of each computation copy. Our experimental results proved that the proposed techniques considerably improve the computation accuracy of TrueNorth platform and reduce the incurred hardware and performance overheads. Among all the tested methods, L1TEA regularization achieved the best result, say, up to 2.74% accuracy enhancement when deploying MNIST application onto TrueNorth platform. In May 2016, IBM TrueNorth team implemented convolutional neural networks (CNN) on TrueNorth processor and coincidently use a similar method, say, trinary weights, {-1, 0, 1}. | 2017 | An FPGA Design Framework for CNN Sparsification and AccelerationabstractConvolutional neural networks (CNNs) have recently broken many performance records in image recognition and object detection problems. The success of CNNs, to a great extent, is enabled by the fast scaling-up of the networks that learn from a huge volume of data. The deployment of big CNN models can be both computation-intensive and memory-intensive, leaving severe challenges to hardware implementations. In recent years, sparsification techniques that prune redundant connections in the networks while still retaining the similar accuracy emerge as promising solutions to alliterate the computation overheads associated with CNNs [1]. However, imposing sparsity in CNNs usually generates random network connections and thus, the irregular data access pattern results in poor data locality. The low computation efficiency of the sparse networks, which is caused by the incurred unbalance in computing resource consumption and low memory bandwidth usage, significantly offsets the theocratical reduction of the computation complexity and limits the execution scalability of CNNs on general- purpose architectures [2]. For instance, as an important computation kernel in CNNs – the sparse convoluation, is usually accelerated by using data compression schemes where only nonzero elements of the kernel weights are stored and sent to multiplication-accumulation computations (MACs) at runtime. However, the relevant executions on CPUs and GPUs reach only 0.1% to 10% of the system peak performance even designated software libraries are applied (e.g., MKL library for CPUs and cuSPARSE library for GPUs). Field programmable gate arrays (FPGAs) have been also extensively studied as an important hardware platform for CNN computations [3]. Different from general-purpose architectures, FPGA allows users to customize the functions and organization of the designed hardware in order to adapt various resource needs and data usage patterns. This characteristic, as we identified in this work, can be leveraged to effectively overcome the main challenges in the execution of sparse CNNs through close coordinations between software and hardware. In particular, the reconfigurability of FPGA helps to 1) better map the sparse CNN onto the hardware for improving computation parallelism and execution efficiency and 2) eliminate the computation cost associated with zero weights and enhance data reuse to alleviate the adverse impacts of the irregular data accesses. In this work, we propose a hardware-software co-design framework to address the above challenges in sparse CNN accelerations. First, we introduce a data locality-aware sparsification scheme that optimizes the structure of the sparse CNN during training phase to make it friendly for hardware mapping. Both memory allocation and data access regularization are considered in the optimization process. Second, we develop a distributed architecture composed of the customized processing elements (PEs) that enables high computation parallelism and data reuse rate of the compressed network. Moreover, a holistic sparse optimization is introduced to our design framework for hardware platforms with different requirement. We evaluate our proposed frame- work by executing AlexNet on Xilinx Zynq ZC706. Our FPGA accelerator obtains a processing power of 71.2 GOPS, corresponding to 271.6 GOPS on the dense CNN model. | 2016 | A data locality-aware design framework for reconfigurable sparse matrix-vector multiplication kernelabstractSparse matrix-vector multiplication (SpMV) is an important computational kernel in many applications. For performance improvement, software libraries designated for SpMV computation have been introduced, e.g., MKL library for CPUs and cuSPARSE library for GPUs. However, the computational throughput of these libraries is far below the peak floating-point performance offered by hardware platforms, because the efficiency of SpMV kernel is greatly constrained by the limited memory bandwidth and irregular data access patterns. In this work, we propose a data locality-aware design framework for FPGA-based SpMV acceleration. We first include the hardware constraints in sparse matrix compression at software level to regularize the memory allocation and accesses. Moreover, a distributed architecture composed of processing elements is developed to improve the computation parallelism. We implement the reconfigurable SpMV kernel on Convey HC-2ex and conduct the evaluation by using the University of Florida sparse matrix collection. The experiments demonstrate an average computational efficiency of 48.2%, which is a lot better than those of CPU and GPU implementations. Our FPGA-based kernel has a comparable runtime as GPU, and achieves 2.1× reduction than CPU. Moreover, our design obtains substantial saving in energy consumption, say, 9.3× and 5.6× better than the implementations on CPU and GPU, respectively. | 2016 | Heterogeneous systems with reconfigurable neuromorphic computing acceleratorsabstractDeveloping heterogeneous system with hardware accelerator is a promising solution to implement high performance applications where explicitly programmed, rule-based algorithms are either infeasible or inefficient. However, mapping a neural network model to a hardware representation is a complex process, where balancing computation resources and memory accesses is crucial. In this work, we present a systematic approach o optimize the heterogeneous system with a FPGA-based neuromorphic computing accelerator (NCA). For any applications, the neural network topology and computation flow of the accelerator can be configured through a NCA-aware compiler. The FPGA-based NCA contains a generic multi-layer neural network composed of a set of parallel neural processing elements. Such a scheme imitates the human cognition process and follows the hierarchy of neocortex. At architectural level, we decrease the computing resource requirement to enhance computation efficiency. The hardware implementation primarily targets at reducing data communication load: a multi-thread computation engine is utilized to mask the long memory latency. Such a combined solution can well accommodate the ever increasing complexity and scalability of machine learning applications and improve the system performance and efficiency. Through the evaluation across eight representative benchmarks, we observed on average 12.1× speedup and 45.8× energy reduction, with marginal accuracy loss comparing with CPU-only computation. | 2015 | FPGA Acceleration of Recurrent Neural Network Based Language ModelabstractRecurrent neural network (RNN) based language model (RNNLM) is a biologically inspired model for natural language processing. It records the historical information through additional recurrent connections and therefore is very effective in capturing semantics of sentences. However, the use of RNNLM has been greatly hindered for the high computation cost in training. This work presents an FPGA implementation framework for RNNLM training acceleration. At architectural level, we improve the parallelism of RNN training scheme and reduce the computing resource requirement for computation efficiency enhancement. The hardware implementation primarily targets at reducing data communication load. A multi-thread based computation engine is utilized which can successfully mask the long memory latency and reuse frequent accessed data. The evaluation based on the Microsoft Research Sentence Completion Challenge shows that the proposed FPGA implementation outperforms traditional class-based modest-size recurrent networks and obtains 46.2% in training accuracy. | 2013 | DA-RAID-5: a disturb aware data protection technique for NAND flash storage systemsabstractProgram disturb, read disturb and retention time limit are three major reasons accounting for the bit errors in NAND flash memory. The adoption of multi-level cell (MLC) technology and technology scaling further aggravates this reliability issue by narrowing threshold voltage noise margins and introducing larger device variations. Besides implementing error correction code (ECC) in NAND flash modules, RAID-5 are often deployed at system level to protect the data integrity of NAND flash storage systems (NFSS), however, with significant performance degradation. In this work, we propose a technique called “DA-RAID-5” to improve the performance of the enterprise NFSS under RAID-5 protection without harming its reliability (here DA stands for “disturb aware”). Three schemes, namely, unbound-disturb limiting (UDL), PE-aware RAID-5 and Hybrid Caching(HC) are proposed to protect the NFSS at the different stages of its lifetime.
