| 2024 | XVDPU: A High-Performance CNN Accelerator on the Versal Platform Powered by the AI EngineabstractToday, convolutional neural networks (CNNs) are widely used in computer vision applications. However, the trends of higher accuracy and higher resolution generate larger networks. The requirements of computation or I/O are the key bottlenecks. In this article, we propose XVDPU: the AI Engine (AIE)-based CNN accelerator on Versal chips to meet heavy computation requirements. To resolve the IO bottleneck, we adopt several techniques to improve data reuse and reduce I/O requirements. An arithmetic logic unit is further proposed that can better balance resource utilization, new feature support, and efficiency of the whole system. We have successfully deployed more than 100 CNN models with our accelerator. Our experimental results show that the 96-AIE-core implementation can achieve 1,653 frames per second (FPS) for ResNet50 on VCK190, which is 9.8× faster than the design on ZCU102 running at 168.5 FPS. The 256-AIE-core implementation can further achieve 4,050 FPS. We propose a tilling strategy to achieve feature-map-stationary for high-definition CNN with the accelerator, achieving 3.8× FPS improvement on the residual channel attention network and 3.1× on super-efficient super-resolution. This accelerator can also solve the 3D convolution task in disparity estimation, achieving end-to-end performance of 10.1 FPS with all the optimizations. | 2022 | XVDPU: A High Performance CNN Accelerator on the Versal Platform Powered by the AI EngineabstractThe convolution neural networks (CNNs) are widely used in computer vision applications nowadays. However, the trends of higher accuracy and higher resolution generate larger networks, indicating that computation and I/O bandwidth are key bottlenecks to reach performance. The Xilinx's latest 7nm Versal ACAP platform with AI-Engine (AIE) cores can deliver up-to 8x silicon compute density at 50% the power consumption compared with the traditional FPGA solutions. In this paper, we propose XVDPU: the AIE-based int8-precision CNN accelerator on Versal chips, scaling from 16-AIE-core (C16B1) to 320-AIE-core (C64B5, Peak:109.2 TOPs) to meet computation requirements. To resolve IO bottleneck, we adopt several techniques such as multi-batch (MB), shared-weights (SHRWGT), feature-map-stationary (FMS) and long-load-weights (LLW) to improve data-reuse and reduce I/O requirements. An Arithmetic Logic Unit (ALU) design is further proposed into the accelerator which mainly performs non-convolution layers such as Depthwise-Conv layer, Pooling layer and Non-linear function layers using the same logic resources, which can better balance resource utilization, new feature support and efficiency of the whole system. We have successfully deployed more than 100 CNN models with our accelerator. Our experimental results show that the 96-AIE-core (C32B3, Peak: 32.76 TOPs) implementation can achieve 1653 FPS for ResNet50 on VCK190, which is 9.8x faster than the design on ZCU102 running at 168.5 FPS with peak 3.6 TOPs. The 256-AIE-core (C32B8, Peak: 87.36 TOPs) implementation can further achieve 4050 FPS which better leverages the computing power of Versal AIE devices. | 2022 | A-U3D: A Unified 2D/3D CNN Accelerator on the Versal Platform for Disparity Estimationabstract3-Dimensional (3D) convolutional neural networks (CNN) are widely used in the field of disparity estimation. However, 3D CNN is more computationally dense than 2D CNN due to the increase in the disparity dimension. To enable more practical applications in autonomous driving, robotics, and other scenarios on embedded devices, we propose a unified 2D/3D CNN accelerator (A-U3D) design. This design unifies 3D standard / transposed convolution into 2D standard convolution, respectively. Our processing unit can support 2D and 3D convolution in the same mode without additional structures. Based on PSMNet, a 3D-based CNN for disparity estimation, we build a heterogeneous multi-core system integrated with A-U3D in conjunction with CPU, DSP, and AI Engines on the Xilinx Versal ACAP platform. Running the pruned 8-bit model, our A-U3D system achieves 0.289s latency, which is 11.5 × faster than the state-of-the-art solution on the same platform, and reaches an end-to-end (E2E) performance of 10.1 frames per second (FPS). | 2020 | LPAC: A Low-Precision Accelerator for CNN on FPGAsabstractLow bit quantization of neural network is required on edge devices to achieve lower power consumption and higher performance. 8bit or binary network either consumes a lot of resources or has accuracy degradation. Thus, a full-process hardware-friendly quantization solution of 4A4W (activations 4bit and weights 4bit) is proposed to achieve better accuracy/resource trade-off. It doesn't contain any additional floating operations and achieve accuracy comparable to full-precision. We also implement a low-precision accelerator for CNN (LPAC) on the Xilinx FPGA, which takes full advantage of its DSP by efficiently mapping convolutional computations. Through on-chip reassign management and resource-saving analysis, high performance can be achieved on small chips. Our 4A4W solution achieves 1.8x higher performance than 8A8W and 2.42x increase in power efficiency under the same resource. On ImageNet classification, the accuracy has a gap less than 1% to full-precision in Top-5. On the human pose estimation, we achieve 261 frames per second on ZU2EG, which is 1.78x speed up compared to 8A8W and the accuracy has only 1.62% gap to full-precision. | 2020 | DNNVM: End-to-End Compiler Leveraging Heterogeneous Optimizations on FPGA-Based CNN Acceleratorsabstractstate-of-the-art method for several artificial intelligence domains in recent years. The increasingly complex CNN models are both computation-bound and I/O-bound. Fieldprogrammable gate array-based accelerators driven by custom instruction set architecture (ISA) achieve a balance between generality and efficiency, but there is much on them left to be optimized. We propose the full-stack compiler deep neural network virtual machine (DNNVM), which is an integration of optimizers for graphs, loops and data layouts, an assembler, a runtime supporter, and a validation environment. The DNNVM works in the context of deep learning frameworks and transforms CNN models into the directed acyclic graph: XGraph. Based on XGraph, we transform the optimization challenges for both data layout and pipeline into graph-level problems. DNNVM enumerates all potentially profitable fusion opportunities by a heuristic subgraph isomorphism algorithm to leverage pipeline and data layout optimizations, and searches for the best choice of execution strategies of the whole computing graph. On the Xilinx ZU2@330 MHz and ZU9@330 MHz, we achieve equivalently state-of-the-art performance on our benchmarks by naïve implementations without optimizations, and the throughput is further improved up to 1.26× by leveraging heterogeneous optimizations in DNNVM. Finally, with ZU9@330 MHz, we achieve state-of-the-art performance for VGG and ResNet50. We achieve a throughput of 2.82 TOPs/s and an energy efficiency of 123.7 GOPs/s/W for VGG. The increasingly large and complex CNN models are both computation bound and I/O bound. FPGA-based accelerators driven by custom Instruction Set Architecture(ISA) achieve a balance between generality and efficiency, and leave much room for optimization. Operation fusion which fuses adjacent operations without saving intermediate results back to off-chip DDR can greatly alleviate bandwidth pressure, operations can be executed by different computation engines concurrently for latency hiding. To leverage optimizations, especially operation fusion on custom instruction-based accelerators, we propose a full-stack compiler DNNVM(Deep Neural Network Virtual Machine). DNNVM is an integration of optimizers for framework-independent computing graph, loops and data layouts, an assembler, a runtime supporter and a validation environment. DNNVM works in the context of deep learning frameworks and transforms CNN models into a directed acyclic graph, XGraph. After analyzing the interaction among fusion depth, tiling across multiple stages and on-chip memory capacity, DNNVM enumerates all potentially profitable fusion opportunities according to custom fusion templates upon XGraph, by a subgraph isomorphism algorithm. In addition, DNNVM searches for the optimal execution strategies by a heuristic shortest-path algorithm. | 2019 | A High-Performance CNN Processor Based on FPGA for MobileNetsabstractConvolution neural networks (CNNs) have been widely applied in the fields of computer vision tasks. However, it is hard to deploy those standard neural networks into embedded devices because of their large amount of operations and parameters. MobileNet, the state-of-the-art CNN which adopts depthwise separable convolution to replace the standard convolution has significantly reduced operations and parameters with only limited loss in accuracy. A high-performance CNN processor based on FPGA is proposed in this paper. To improve the efficiency, two dedicated computing engines named Conv Engine and Dwcv Engine were designed for pointwise convolution and depthwise convolution respectively. The schedule for Conv Engine and Dwcv Engine has significantly improved the efficiency of our accelerator. Furthermore, we designed a special architecture called Channel Augmentation to improve the efficiency in the first layer of MobileNets. The accelerator can be flexibly deployed to various devices with different configurations to balance hardware resources and computational performance. We implemented our accelerator on ZU2 and ZU9 MPSoC FPGAs. The classification on ImageNet achieved 205.3 frames per second(fps) on ZU2 and 809.8 fps on ZU9, which is 15.4x speedup on ZU2 and 60.7x speedup on ZU9 compared to CPU. | 2016 | SRI-SURF: A better SURF powered by scaled-RAM interpolator on FPGAabstractSpeed-Up Robust Feature (SURF) is an effective algorithm for feature extraction. We propose a novel Scaled-RAM Interpolator (SRI) on FPGA to deal with the high complexity of SURF by introducing two methods. 1) Interpolation of Integral Image (I3) restores the sub-pixel details of image to improve matching precision, and halves the memory access to achieve acceleration; 2) Multi-Scaled RAM (MSR) normalizes the storage allocation by scale to decrease complexity of memory access and reject redundant memory. With SRI, our system achieves better matching precision, higher processing speed, and lower storage occupation. The results of evaluation implemented on Stratix III EP3SL340 FPGA show that 1) our SRI-SURF system performs better in matching than OpenSURF; 2) the system is capable to process 241K feature points per second (PPS), which is about 7× of previous work on FPGA and is comparable to the recent ASIC solution; 3) the maximal frame rate reaches 488FPS at VGA and 72FPS at 1080P, which outperforms designs in other publications; 4) our design is compact, which only occupies about 22% logic resource and about 43% RAM resource at 1080P.
