| 2025 | Abstraction Refinement-Guided Program Synthesis for Robot Learning from DemonstrationsabstractOver the past decade, deep reinforcement learning (RL) techniques have significantly advanced robotic systems. However, due to the complex architectures of neural network models, ensuring their trustworthiness is a considerable challenge. Programmatic reinforcement learning has surfaced as a promising approach. Nonetheless, synthesizing robot-control programs remains challenging. Existing methods rely on domain-specific languages (DSLs) populated with user-defined state abstraction predicates and a library of low-level controllers as abstract actions to boot synthesis, which is impractical in unknown environments that lack such predefined components. To address this limitation, we introduce RoboScribe, a novel abstraction refinement-guided program synthesis framework that automatically derives robot state and action abstractions from raw, unsegmented task demonstrations in high-dimensional, continuous spaces. It iteratively enriches and refines an initially coarse abstraction until it generates a task-solving program over the abstracted robot environment. RoboScribe is effective in synthesizing iterative programs by inferring recurring subroutines directly from the robot’s raw, continuous state and action spaces, without needing predefined abstractions. Experimental results show that RoboScribe programs inductively generalize to long-horizon robot tasks involving arbitrary numbers of objects, outperforming baseline methods in terms of both interpretability and efficiency. | 2024 | Learning World Models for Unconstrained Goal NavigationabstractLearning world models offers a promising avenue for goal-conditioned reinforcement learning with sparse rewards. By allowing agents to plan actions or exploratory goals without direct interaction with the environment, world models enhance exploration efficiency. The quality of a world model hinges on the richness of data stored in the agent's replay buffer, with expectations of reasonable generalization across the state space surrounding recorded trajectories. However, challenges arise in generalizing learned world models to state transitions backward along recorded trajectories or between states across different trajectories, hindering their ability to accurately model real-world dynamics. To address these challenges, we introduce a novel goal-directed exploration algorithm, MUN (short for "World Models for Unconstrained Goal Navigation"). This algorithm is capable of modeling state transitions between arbitrary subgoal states in the replay buffer, thereby facilitating the learning of policies to navigate between any "key" states. Experimental results demonstrate that MUN strengthens the reliability of world models and significantly improves the policy's capacity to generalize across new goal settings. | 2023 | Instructing Goal-Conditioned Reinforcement Learning Agents with Temporal Logic ObjectivesabstractGoal-conditioned reinforcement learning (RL) is a powerful approach for learning general-purpose skills by reaching diverse goals. However, it has limitations when it comes to task-conditioned policies, where goals are specified by temporally extended instructions written in the Linear Temporal Logic (LTL) formal language. Existing approaches for finding LTL-satisfying policies rely on sampling a large set of LTL instructions during training to adapt to unseen tasks at inference time. However, these approaches do not guarantee generalization to out-of-distribution LTL objectives, which may have increased complexity. In this paper, we propose a novel approach to address this challenge. We show that simple goal-conditioned RL agents can be instructed to follow arbitrary LTL specifications without additional training over the LTL task space. Unlike existing approaches that focus on LTL specifications expressible as regular expressions, our technique is unrestricted and generalizes to $\omega$-regular expressions. Experiment results demonstrate the effectiveness of our approach in adapting goal-conditioned RL agents to satisfy complex temporal logic task specifications zero-shot. | 2023 | RuleOut Forwarding Anomalies for SDNabstractReliable Software-Defined Networking (SDN) should mitigate forwarding anomalies due to cross-plane rule inconsistencies. Most existing countermeasures either inject probe packets to infer forwarding correctness or collect packet traces to detect forwarding anomalies. They, however, cannot detect or filter forwarding anomalies for production packets in real time. In this paper, we propose RuleOut as the first attempt to automatically throttle SDN forwarding anomalies. It disambiguates dependent rules via augmenting their matching fields with unique tags. Leveraging source routing, we further bind each packet with the tag sequence corresponding to rules the packet should match. RuleOut thus renders each packet to match at most one rule on each switch. This completely addresses the root cause of forwarding ambiguity. To implement RuleOut, we develop a non-overlapping rule dependency graph, a series of algorithms for incremental rule update and tag generation upon it, and various optimization techniques toward scalability and efficiency. We prototype RuleOut on the Ryu controller and Open vSwitch and evaluate its performance over public rule sets such as Stanford, Internet2, and Airtel1. RuleOut can use tags of only several bits long to disambiguate thousands to millions of rules and generate tags fairly fast within a few milliseconds.
