2026 Calibrating and Rotating: A Unified Framework for Weight Conditioning in PEFT
abstract
Parameter-Efficient Fine-Tuning (PEFT) methods are crucial for adapting large pre-trained models. Among these, LoRA is considered a foundational approach. Building on this, the influential DoRA method enhances performance by decomposing weight updates into magnitude and direction. However, its underlying mechanism remains unclear, and it introduces significant computational overhead. In this work, we first identify that DoRA's success stems from its capacity to increase the singular value entropy of the weight update matrix, which promotes a more uniform update distribution akin to full fine-tuning. We then reformulate DoRA into a mathematically equivalent and more efficient matrix form, revealing it as a learnable weight conditioning method. Based on this insight, we propose a unified framework for designing advanced PEFT methods by exploring two orthogonal dimensions: the architectural placement and the transformation type of the conditioning matrix. Within this framework, we introduce two novel methods: (1) Pre-Diag, which applies a diagonal conditioning matrix before the LoRA update to efficiently calibrate the pre-trained weights, thereby enhancing performance while reducing training time; and (2) Skewed Orthogonal Rotation Adaptation (SORA), which employs a parameter-efficient orthogonal rotation to perform a more powerful, norm-preserving transformation of the feature space. Extensive experiments on natural language understanding and generation tasks demonstrate that our proposed methods achieve superior performance and efficiency compared to both LoRA and DoRA.

2024 Improving GPU Energy Efficiency through an Application-transparent Frequency Scaling Policy with Performance Assurance
abstract
Power consumption is one of the top limiting factors in high-performance computing systems and data centers, and dynamic voltage and frequency scaling (DVFS) is an important mechanism to control power. Existing works using DVFS to improve GPU energy efficiency suffer from the limitation that their policies either impact performance too much or require offline application profiling or code modification, which severely limits their applicability on large clusters. To address this issue, we propose a novel GPU DVFS policy, GEEPAFS, which improves the energy efficiency of GPUs while providing performance assurance. GEEPAFS is application-transparent as it does not require any offline profiling or code modification on user applications. To achieve this, GEEPAFS models application performance online based on our quantitative analysis of a correlation between performance and GPU memory bandwidth utilization. Based on their relationship, GEEPAFS builds a fold-line frequency-performance model for applications being executed, and it applies the model to guide the setting of GPU frequency to maximize energy efficiency while ensuring the performance loss is bounded. Through experiments on NVIDIA V100 and A100 GPUs, we show that GEEPAFS is able to improve the energy efficiency by 26.7% and 20.2% on average. While achieving this improvement, the average performance loss is only 5.8%, and the worst-case performance loss is 12.5% among all 33 tested applications.

2024 Unlocking High Performance with Low-Bit NPUs and CPUs for Highly Optimized HPL-MxP on Cloud Brain II
abstract
Mix-precision computation is crucial for artificial intelligence and scientific computing applications. However, as novel chips with innovative architectures emerge, harnessing their computational capabilities presents significant challenges. While existing algorithms for the HPL-MxP LU factorization excel on homogeneous systems, they often encounter difficulties on specialized heterogeneous architectures. This deficiency arises from inadequate optimization for computation, memory access, and communication, hindering effective mixed-precision acceleration. This work introduces an algorithm-hardware co-optimization approach for LU factorization on specialized NPUs and CPUs, leveraging their unique architectures. A novel multi-iteration fusion method for general matrix multiplication is proposed, strategically designed to maximize on-chip L1 buffer utilization, effectively overcoming the notorious “memory wall”. Additionally, a multi-stage, multi-level heterogeneous pipeline for LU factorization in an accelerator-CPU cloud environment is presented, where compute-intensive matrix multiplications are offloaded to NPUs while CPUs handle the remaining tasks. The co-optimization approach fosters deep collaboration between CPUs and accelerators, thereby unlocking enhanced performance.

2023 An Efficient Fisher Matrix Approximation Method for Large-Scale Neural Network Optimization
abstract
Although the shapes of the parameters are not crucial for designing first-order optimization methods in large scale empirical risk minimization problems, they have important impact on the size of the matrix to be inverted when developing second-order type methods. In this article, we propose an efficient and novel second-order method based on the parameters in the real matrix space [Formula: see text] and a matrix-product approximate Fisher matrix (MatFisher) by using the products of gradients. The size of the matrix to be inverted is much smaller than that of the Fisher information matrix in the real vector space [Formula: see text]. Moreover, by utilizing the matrix delayed update and the block diagonal approximation techniques, the computational cost can be controlled and is comparable with first-order methods. A global convergence and a superlinear local convergence analysis are established under mild conditions. Numerical results on image classification with ResNet50, quantum chemistry modeling with SchNet, and data-driven partial differential equations solution with PINN illustrate that our method is quite competitive to the state-of-the-art methods.
