| 2026 | Personalized Federated Learning with Bidirectional Communication Compression via One-Bit Random SketchingabstractFederated Learning (FL) enables collaborative training across decentralized data, but faces key challenges of bidirectional communication overhead and client-side data heterogeneity. To address communication costs while embracing data heterogeneity, we propose pFed1BS, a novel personalized federated learning framework that achieves extreme communication compression through one-bit random sketching. In personalized FL, the goal shifts from training a single global model to creating tailored models for each client. In our framework, clients transmit highly compressed one-bit sketches, and the server aggregates and broadcasts a global one-bit consensus. To enable effective personalization, we introduce a sign-based regularizer that guides local models to align with the global consensus while preserving local data characteristics. To mitigate the computational burden of random sketching, we employ the Fast Hadamard Transform for efficient projection. Theoretical analysis guarantees that our algorithm converges to a stationary neighborhood of the global potential function. Numerical simulations demonstrate that pFed1BS substantially reduces communication costs while achieving competitive performance compared to advanced communication-efficient FL algorithms. | 2026 | Hybrid Vector-Occupancy Field for Robust Implicit 3D Surface ReconstructionabstractWe introduce the Hybrid Vector-Occupancy Field (HVOF), a new implicit 3D representation for reconstructing both open and closed surfaces from sparse point clouds. Existing approaches, such as occupancy field and signed distance fields, face severe limitations. They struggle with open surfaces, while unsigned distance field and neural vector field exhibit directional instability in complex topologies and ridge regions. HVOF addresses these challenges by incorporating a smoothly decaying occupancy field around the surface, while capturing precise local geometry using truncated displacement vectors, naturally mitigating direction-field ambiguities near ridge regions. This unified design forms a robust hybrid representation that leverages both occupancy and vector fields. To fulfill it, we design a Hybrid Field variational autoencoder including a hierarchical cross-attention encoder and dual-branch decoder that jointly learn occupancy and vector fields through continuous weighting. Extensive experiments demonstrate that HVOF consistently outperforms state-of-the-art methods across ShapeNet, ABC, and MGN datasets, accurately reconstructing both open and closed surfaces while preserving fine geometric details in complex regions. | 2025 | Preserving Privacy in Fine-Grained Data Distillation With Sparse Answers for Efficient Edge ComputingabstractIn the field of Internet of Things (IoT), data distillation has been thought of as a key method to condense the original real dataset into a tiny synthetic dataset with less training burden while maintaining as much data utility as possible for training deep learning models. However, the data synthesis process may remember some sensitive information about the original dataset, which may raise privacy concerns for data owners. To address this problem, we present a novel differential privacy (DP)-based data distillation algorithm. Specifically, in the data distillation phase, we first randomly pick a training model from the model pool in each epoch, and then build a fine-grained distribution matching to generate informative data for improving the task-oriented model performance. In the privacy preservation phase, we selectively perturb input features that are more important for model training based on the sparse vector technique to protect the sensitive information contained in the original dataset and reduce privacy costs. Extensive experiments across several real-world datasets demonstrate that our algorithm can achieve higher data utility and model accuracy than existing solutions. | 2025 | SAAF: Self-Adaptive Attention Factor-Based Taylor-Pruning on Convolutional Neural NetworksabstractNowadays, pruning techniques have drawn attention to convolutional neural networks (CNNs) for reducing the consumption of computation resources. In particular, the Taylor-based method simplifies the evaluation of importance for each filter as the product of the gradient and weight value of the output features, which outperforms other methods in reductions of parameters and floating point operations (FLOPs). However, the Taylor-based method sacrifices too much accuracy when the overall pruning rate is relatively large compared with other pruning algorithms. In this article, we propose a self-adaptive attention factor (SAAF) to improve the performance of the slimmed model when conventional Taylor-based pruning is utilized under higher pruning. Specifically, SAAF can be calculated by leveraging the remaining ratio of filters at the early pruning stage of the Taylor-based method, and then, some pruned filters can be recovered for improving the accuracy of the slimmed model in terms of SAAF. It means that SAAF can protect filters from being overslimmed to eliminate the degeneration of Taylor-based pruning when the pruning rate is large as well as can compress models apparently across various datasets. We test the efficiency of SAAF on VGG-16 and ResNet-50 with CIFAR-10, Tiny-ImageNet, ImageNet-1000, and remote sensing images. Our method outperforms the traditional Taylor-based method obviously in accuracy, and there are only tiny sacrifices in the reduction of parameters and FLOPs, which is better than other pruning methods. | 2025 | Few-Shot Learning With Enhancements to Data Augmentation and Feature ExtractionabstractThe few-shot image classification task is to enable a model to identify novel classes by using only a few labeled samples as references. In general, the more knowledge a model has, the more robust it is when facing novel situations. Although directly introducing large amounts of new training data to acquire more knowledge is an attractive solution, it violates the purpose of few-shot learning with respect to reducing dependence on big data. Another viable option is to enable the model to accumulate knowledge more effectively from existing data, i.e., improve the utilization of existing data. In this article, we propose a new data augmentation method called self-mixup (SM) to assemble different augmented instances of the same image, which facilitates the model to more effectively accumulate knowledge from limited training data. In addition to the utilization of data, few-shot learning faces another challenge related to feature extraction. Specifically, existing metric-based few-shot classification methods rely on comparing the extracted features of the novel classes, but the widely adopted downsampling structures in various networks can lead to feature degradation due to the violation of the sampling theorem, and the degraded features are not conducive to robust classification. To alleviate this problem, we propose a calibration-adaptive downsampling (CADS) that calibrates and utilizes the characteristics of different features, which can facilitate robust feature extraction and benefit classification. By improving data utilization and feature extraction, our method shows superior performance on four widely adopted few-shot classification datasets. | 2024 | Dual Appearance-Aware Enhancement for Oriented Object DetectionabstractOriented detectors have become the mainstream of object detection in remote-sensing images since they provide more precise bounding boxes and contain less background. However, there remain several challenges that restrict the detection performance and need to be tackled. This article focuses on the following two aspects: 1) numerous tiny objects in remote-sensing images pose a challenge for the detectors pursuing high recall and accurate localization and 2) specific categories with large aspect ratios and arbitrary angles also trouble the regression of the detectors. We attempt to alleviate the above problems by constructing a weak feature extraction network (WFEN) and a dual appearance-aware (DA) loss. Specifically, WFEN is used to extract hierarchical weight vectors for multiscale feature layers by employing a lightweight convolutional module, aiming to fuse activation features distributed in different layers and provide pure features for subsequent regression and classification. DA loss is tailored to regressions of tiny and slender objects by dynamically modulating the associated loss on objects with various appearances, which consists of two auxiliary losses, termed scale-aware loss${\mathcal {L}}_{S}$and aspect-ratio-aware loss${\mathcal {L}}_{A}$. These two components can contribute to each other, that is, the former provides more accurate features for detection tasks, while the latter can reciprocate the former by imposing constraints on crucial objects, and together constitute an appearance sensitivity detector (ASDet). Extensive experiments on three public datasets demonstrate that our ASDet outperforms all refine-stage detectors in terms of accuracy while maintaining the superior inference speed of single-stage counterparts. | 2022 | An Automatically Layer-Wise Searching Strategy for Channel Pruning Based on Task-Driven Sparsity OptimizationabstractDeep convolutional neural networks (CNNs) have achieved tremendous successes but tend to suffer from high computation costs mainly due to heavy over-parameterization, resulting in the difficulty of directly applying them to the ever-growing application demands based on low-end edge devices with strong power restriction and real-time inference requirement. Recently, there has much research attention devoted to compressing the network via pruning to address this issue. Most of the existing methods rely on some hand-designed pruning rules, which suffer from several limitations. Firstly, manually designed rules are only applicable to limited application scenarios, which can hardly generalize well in a broader scope. And these rules are typically designed based on human experience and via trial and error, and thus highly subjective. Then, channels of different layers in a network may have diverse distributions, which means the same pruning rule is not appropriate for each layer. To address these limitations, we propose a novel channel pruning scheme, in which the task-irrelevant channels are removed in a task-driven manner. Specifically, an adaptively differentiable search module is proposed to find the best pruning rule automatically for different layers in CNNs under sparsity constraints. Besides, we employed knowledge distillation to alleviate the excessive performance loss. Once the training process is finished, a compact network will be obtained by removing channels based on layer-wise pruning rules. We have evaluated the proposed method on some well-known benchmark datasets including CIFAR, MNIST, and ImageNet in comparison to several state-of-the-art pruning methods. Experimental results demonstrate the superiority of our method over the compared ones in terms of both parameters and FLOPs reduction. Kaiyuan Feng, Xia Fei, Maoguo Gong, A. K.
