| 2025 | Decoupled SGDA for Games with Intermittent Strategy CommunicationabstractWe introduce *Decoupled SGDA*, a novel adaptation of Stochastic Gradient Descent Ascent (SGDA) tailored for multiplayer games with intermittent strategy communication. Unlike prior methods, Decoupled SGDA enables players to update strategies locally using outdated opponent strategies, significantly reducing communication overhead. For Strongly-Convex-Strongly-Concave (SCSC) games, it achieves near-optimal communication complexity comparable to the best-known GDA rates. For *weakly coupled* games where the interaction between players is lower relative to the non-interactive part of the game, Decoupled SGDA significantly reduces communication costs compared to standard SGDA. Additionally, *Decoupled SGDA* outperforms federated minimax approaches in noisy, imbalanced settings. These results establish *Decoupled SGDA* as a transformative approach for distributed optimization in resource-constrained environments. | 2025 | Revisiting Consensus Error: A Fine-grained Analysis of Local SGD under Second-order Data HeterogeneityabstractLocal SGD, or Federated Averaging, is one of the most widely used algorithms for distributed optimization. Although it often outperforms alternatives such as mini-batch SGD, existing theory has not fully explained this advantage under realistic assumptions about data heterogeneity. Recent work has suggested that a second-order heterogeneity assumption may suffice to justify the empirical gains of local SGD. We confirm this conjecture by establishing new upper and lower bounds on the convergence of local SGD. These bounds demonstrate how a low second-order heterogeneity, combined with third-order smoothness, enables local SGD to interpolate between heterogeneous and homogeneous regimes while maintaining communication efficiency. Our main technical contribution is a refined analysis of the consensus error, a central quantity in such results. We validate our theory with experiments on a distributed linear regression task. | 2024 | The Limits and Potentials of Local SGD for Distributed Heterogeneous Learning with Intermittent CommunicationabstractLocal SGD is a popular optimization method in distributed learning, often outperforming mini-batch SGD. Despite this practical success, proving the efficiency of local SGD has been difficult, creating a significant gap between theory and practice. We provide new lower bounds for local SGD under existing first-order data heterogeneity assumptions, showing these assumptions can not capture local SGD’s effectiveness. We also demonstrate the min-max optimality of accelerated mini-batch SGD under these assumptions. Our findings emphasize the need for improved modeling of data heterogeneity. Under higher-order assumptions, we provide new upper bounds that verify the dominance of local SGD over mini-batch SGD when data heterogeneity is low.
