| 2025 | Yggdrasil: Bridging Dynamic Speculation and Static Runtime for Latency-Optimal Tree-Based LLM DecodingabstractSpeculative decoding improves LLM inference by generating and verifying multiple tokens in parallel, but existing systems suffer from suboptimal performance due to a mismatch between dynamic speculation and static runtime assumptions. We present Yggdrasil, a co-designed system that enables latency-optimal speculative decoding through context-aware tree drafting and compiler-friendly execution. Yggdrasil introduces an equal-growth tree structure for static graph compatibility, a latency-aware optimization objective for draft selection, and stage-based scheduling to reduce overhead. Yggdrasil supports unmodified LLMs and achieves up to $3.98\times$ speedup over state-of-the-art baselines across multiple hardware setups. | 2025 | KVFlow: Efficient Prefix Caching for Accelerating LLM-Based Multi-Agent WorkflowsabstractLarge language model (LLM) based agentic workflows have become a popular paradigm for coordinating multiple specialized agents to solve complex tasks. To improve serving efficiency, existing LLM systems employ prefix caching to reuse key-value (KV) tensors corresponding to agents' fixed prompts, thereby avoiding redundant computation across repeated invocations. However, current systems typically evict KV caches using a Least Recently Used (LRU) policy, which fails to anticipate future agent usage and often discards KV caches shortly before their reuse. This leads to frequent cache misses and substantial recomputation or swap- ping overhead. We present KVFlow, a workflow-aware KV cache management framework tailored for agentic workloads. KVFlow abstracts the agent execution schedule as an Agent Step Graph and assigns each agent a steps-to-execution value that estimates its temporal proximity to future activation. These values guide a fine-grained eviction policy at the KV node level, allowing KVFlow to preserve entries likely to be reused and efficiently manage shared prefixes in tree-structured caches. Moreover, KVFlow introduces a fully overlapped KV prefetching mecha- nism, which proactively loads required tensors from CPU to GPU in background threads for agents scheduled in the next step, thereby avoiding cache miss stalls during generation. Compared to SGLang with hierarchical radix cache, KVFlow achieves up to 1.83× speedup for single workflows with large prompts, and up to 2.19× speedup for scenarios with many concurrent workflows. | 2025 | Mercury: Unlocking Multi-GPU Operator Optimization for LLMs via Remote Memory SchedulingabstractIn this paper, we propose Mercury, a multi-GPU operator compiler based on a loop-based intermediate representation, CommIR. At the core of Mercury is an abstraction that treats remote GPU memory as an explicitly managed extension of the memory hierarchy, expanding the available storage and communication resources beyond local HBM. This unified view enables the compiler to reason holistically about data placement and inter-device communication, unlocking a vastly larger design space that encompasses and extends beyond existing manual strategies. As a result, Mercury is able to automatically reproduce the performance of hand-optimized baselines like RingAttention and Ulysses, and in some configurations, even discovers more effective strategies that manual designs have overlooked. | 2024 | RecFlex: Enabling Feature Heterogeneity-Aware Optimization for Deep Recommendation Models with Flexible SchedulesabstractIndustrial recommendation models typically involve numerous feature fields. The embedding computation workloads are heterogeneous across these fields, thus requiring varied optimal code schedules. While existing solutions apply basic fusion optimization for embedding operations, they inefficiently treat all feature fields with identical schedules, leading to suboptimal performance. In this paper, we introduce RecFlex, which generates fused kernels with distinct schedules for different feature fields. RecFlex employs the interference-aware schedule tuner to tune schedules and the heterogeneous schedule fusion compiler to generate fused kernels, addressing two major challenges. To determine optimal schedules of different feature fields within the fused kernel, RecFlex proposes a two-stage interferencesimulated tuning strategy. To handle dynamic workloads that challenge tuning and fusion, RecFlex combines compile-time schedule tuning with runtime kernel thread mapping. RecFlex surpasses state-of-the-art libraries and compilers, achieving average speedups of $2.64 \times, 20.77 \times$, and $11.31 \times$ over TorchRec, HugeCTR, and RECom, respectively. | 2023 | RECom: A Compiler Approach to Accelerating Recommendation Model Inference with Massive Embedding ColumnsabstractEmbedding columns are important for deep recommendation models to achieve high accuracy, but they can be very time-consuming during inference. Machine learning (ML) compilers are used broadly in real businesses to optimize ML models automatically. Unfortunately, no existing work uses compilers to automatically accelerate the heavy embedding column computations during recommendation model inferences. To fill this gap, we propose RECom, the first ML compiler that aims at optimizing the massive embedding columns in recommendation models on the GPU. RECom addresses three major challenges. First, generating an efficient schedule on the GPU for the massive operators within embedding columns is difficult. Existing solutions usually lead to numerous small kernels and also lack inter-subgraph parallelism. We adopt a novel codegen strategy that fuses massive embedding columns into a single kernel and maps each column into a separate thread block on the GPU. Second, the complex shape computations under dynamic shape scenarios impede further graph optimizations. We develop a symbolic expression-based module to reconstruct all shape computations. Third, ML frameworks inevitably introduce redundant computations due to robustness considerations. We develop a subgraph optimization module that performs graph-level simplifications based on the entire embedding column context. Experiments on both in-house and open-source models show that RECom can achieve 6.61X and 1.91X over state-of-the-art baselines in terms of end-to-end inference latency and throughput, respectively. | 2023 | BladeDISC: Optimizing Dynamic Shape Machine Learning Workloads via Compiler ApproachabstractCompiler optimization plays an increasingly important role to boost the performance of machine learning models for data processing and management. With increasingly complex data, the dynamic tensor shape phenomenon emerges for ML models. However, existing ML compilers either can only handle static shape models or expose a series of performance problems for both operator fusion optimization and code generation in dynamic shape scenes. This paper tackles the main challenges of dynamic shape optimization: the fusion optimization without shape value, and code generation supporting arbitrary shapes. To tackle the fundamental challenge of the absence of shape values, it systematically abstracts and excavates the shape information and designs a cross-level symbolic shape representation. With the insight that what fusion optimization relies upon is tensor shape relationships between adjacent operators rather than exact shape values, it proposes the dynamic shape fusion approach based on shape information propagation. To generate code that adapts to arbitrary shapes efficiently, it proposes a compile-time and runtime combined code generation approach. Finally, it presents a complete optimization pipeline for dynamic shape models and implements an industrial-grade ML compiler, named BladeDISC. The extensive evaluation demonstrates that BladeDISC outperforms PyTorch, TorchScript, TVM, ONNX Runtime, XLA, Torch Inductor (dynamic shape), and TensorRT by up to 6.95×, 6.25×, 4.08×, 2.04×, 2.06×, 7.92×, and 4.16× (3.54×, 3.12×, 1.95×, 1.47×, 1.24×, 2.93×, and 1.46× on average) in terms of end-to-end inference speedup on the A10 and T4 GPU, respectively. | 2022 | G-SLIDE: A GPU-Based Sub-Linear Deep Learning Engine via LSH SparsificationabstractDeep learning has been one of the trendiest research topics. However, as data quantities rise exponentially, training large neural networks can become prohibitively expensive with billions of parameters. Fortunately, recent research has discovered that not all of the computations in traditional network training are necessary. By selectively sparsifying the majority of the neurons during training, we can still obtain acceptable accuracy. SLIDE, a C++ OpenMP-based sub-linear deep learning engine, has been developed in this situation. SLIDE uses the algorithm of locality-sensitive hashing (LSH) to query neurons with high activation in sub-linear time. It achieves a remarkable speedup in training large fully-connected networks by making use of the network sparsity as well as multi-core parallelism. However, SLIDE is limited to CPUs, ignoring the popular GPU devices with greater parallel potential and computational capability. In this paper, we propose G-SLIDE, a GPU-based sub-linear deep learning engine, which combines the benefits of SLIDEs adaptive sparsification algorithms with GPUs high performance. The main challenges in developing G-SLIDE are efficiently using LSH to sparsify networks and training the special sparse neural networks on the GPU. To address these challenges, we propose several novel solutions, such as specific data formats and appropriate workload partitioning for threads to fully utilize the GPU resources. We evaluate G-SLIDE on two extremely sparse datasets with a 2080 Ti GPU, and the results demonstrate that for the time of one training epoch, G-SLIDE can achieve more than 16.4 speedup over SLIDE on a 32-core/64-thread CPU. Furthermore, on the same platform, G-SLIDE can earn an average of 16.2 speedup over TensorFlow-GPU and 30.8 speedup over TensorFlow-CPU. | 2022 | Exploring Data Analytics Without Decompression on Embedded GPU SystemsabstractWith the development of computer architecture, even for embedded systems, GPU devices can be integrated, providing outstanding performance and energy efficiency to meet the requirements of different industries, applications, and deployment environments. Data analytics is an important application scenario for embedded systems. Unfortunately, due to the limitation of the capacity of the embedded device, the scale of problems handled by the embedded system is limited. In this paper, we propose a novel data analytics method, called G-TADOC, for efficient text analytics directly on compression on embedded GPU systems. A large amount of data can be compressed and stored in embedded systems, and can be processed directly in the compressed state, which greatly enhances the processing capabilities of the systems. Particularly, G-TADOC has three innovations. First, a novel fine-grained thread-level workload scheduling strategy for GPU threads has been developed, which partitions heavily-dependent loads adaptively in a fine-grained manner. Second, a GPU thread-safe memory pool has been developed to handle inconsistency with low synchronization overheads. Third, a sequence-support strategy is provided to maintain high GPU parallelism while ensuring sequence information for lossless compression. Moreover, G-TADOC involves special optimizations for embedded GPUs, such as utilizing the CPU-GPU shared unified memory. Experiments show that G-TADOC provides 13.2× average speedup compared to the state-of-the-art TADOC. G-TADOC also improves performance-per-cost by 2.6× and energy efficiency by 32.5× over TADOC. | 2021 | G-TADOC: Enabling Efficient GPU-Based Text Analytics without DecompressionabstractText analytics directly on compression (TADOC) has proven to be a promising technology for big data analytics. GPUs are extremely popular accelerators for data analytics systems. Unfortunately, no work so far shows how to utilize GPUs to accelerate TADOC. We describe G-TADOC, the first framework that provides GPU-based text analytics directly on compression, effectively enabling efficient text analytics on GPUs without decompressing the input data. G-TADOC solves three major challenges. First, TADOC involves a large amount of dependencies, which makes it difficult to exploit massive parallelism on a GPU. We develop a novel fine-grained thread-level workload scheduling strategy for GPU threads, which partitions heavily-dependent loads adaptively in a fine-grained manner. Second, in developing G-TADOC, thousands of GPU threads writing to the same result buffer leads to inconsistency while directly using locks and atomic operations lead to large synchronization overheads. We develop a memory pool with thread-safe data structures on GPUs to handle such difficulties. Third, maintaining the sequence information among words is essential for lossless compression. We design a sequence-support strategy, which maintains high GPU parallelism while ensuring sequence information.
