Stability and Generalization of lp-Regularized Stochastic Learning for GCNabstractGraph convolutional networks (GCN) are viewed as one of the most popular representations among the variants of graph neural networks over graph data and have shown powerful performance in empirical experiments. That l2-based graph smoothing enforces the global smoothness of GCN, while (soft) l1-based sparse graph learning tends to promote signal sparsity to trade for discontinuity. This paper aims to quantify the trade-off of GCN between smoothness and sparsity, with the help of a general lp-regularized (1 Linsen Wei, Shaogao Lv, Ming Li 0065

Kernel-based estimation for partially functional linear model: Minimax rates and randomized sketchesabstractThis paper considers the partially functional linear model (PFLM) where all predictive features consist of a functional covariate and a high dimensional scalar vector. Over an infinite dimensional reproducing kernel Hilbert space, the proposed estimation for PFLM is a least square approach with two mixed regularizations of a function-norm and an $\ell_1$-norm. Our main task in this paper is to establish the minimax rates for PFLM under high dimensional setting, and the optimal minimax rates of estimation are established by using various techniques in empirical process theory for analyzing kernel classes. In addition, we propose an efficient numerical algorithm based on randomized sketches of the kernel matrix. Several numerical experiments are implemented to support our method and optimization strategy. Shaogao Lv

Debiased Distributed Learning for Sparse Partial Linear Models in High DimensionsabstractAlthough various distributed machine learning schemes have been proposed recently for purely linear models and fully nonparametric models, little attention has been paid to distributed optimization for semi-parametric models with multiple structures (e.g. sparsity, linearity and nonlinearity). To address these issues, the current paper proposes a new communication-efficient distributed learning algorithm for sparse partially linear models with an increasing number of features. The proposed method is based on the classical divide and conquer strategy for handling big data and the computation on each subsample consists of a debiased estimation of the doubly regularized least squares approach. With the proposed method, we theoretically prove that our global parametric estimator can achieve the optimal parametric rate in our semi-parametric model given an appropriate partition on the total data. Specifically, the choice of data partition relies on the underlying smoothness of the nonparametric component, and it is adaptive to the sparsity parameter. Finally, some simulated experiments are carried out to illustrate the empirical performances of our debiased technique under the distributed setting. Shaogao Lv, Heng Lian 0002

Improved Inference for Imputation-Based Semisupervised Learning Under Misspecified SettingabstractSemisupervised learning (SSL) has been extensively studied in related literature. Despite its success, many existing learning algorithms for semisupervised problems require specific distributional assumptions, such as "cluster assumption" and "low-density assumption," and thus, it is often hard to verify them in practice. We are interested in quantifying the effect of SSL based on kernel methods under a misspecified setting. The misspecified setting means that the target function is not contained in a hypothesis space under which some specific learning algorithm works. Practically, this assumption is mild and standard for various kernel-based approaches. Under this misspecified setting, this article makes an attempt to provide a theoretical justification on when and how the unlabeled data can be exploited to improve inference of a learning task. Our theoretical justification is indicated from the viewpoint of the asymptotic variance of our proposed two-step estimation. It is shown that the proposed pointwise nonparametric estimator has a smaller asymptotic variance than the supervised estimator using the labeled data alone. Several simulated experiments are implemented to support our theoretical results. Shaogao Lv, Linsen Wei, Bin Liu 0022, Zenglin Xu

Improved Learning Rates of a Functional Lasso-type SVM with Sparse Multi-Kernel RepresentationabstractIn this paper, we provide theoretical results of estimation bounds and excess risk upper bounds for support vector machine (SVM) with sparse multi-kernel representation. These convergence rates for multi-kernel SVM are established by analyzing a Lasso-type regularized learning scheme within composite multi-kernel spaces. It is shown that the oracle rates of convergence of classifiers depend on the complexity of multi-kernels, the sparsity, a Bernstein condition and the sample size, which significantly improves on previous results even for the additive or linear cases. In summary, this paper not only provides unified theoretical results for multi-kernel SVMs, but also enriches the literature on high-dimensional nonparametric classification. | 2016 | Model-free Variable Selection in Reproducing Kernel Hilbert SpaceabstractVariable selection is popular in high-dimensional data analysis to identify the truly informative variables. Many variable selection methods have been developed under various model assumptions. Whereas success has been widely reported in literature, their performances largely depend on validity of the assumed models, such as the linear or additive models. This article introduces a model-free variable selection method via learning the gradient functions. The idea is based on the equivalence between whether a variable is informative and whether its corresponding gradient function is substantially non-zero. The proposed variable selection method is then formulated in a framework of learning gradients in a flexible reproducing kernel Hilbert space. The key advantage of the proposed method is that it requires no explicit model assumption and allows for general variable effects. Its asymptotic estimation and selection consistencies are studied, which establish the convergence rate of the estimated sparse gradients and assure that the truly informative variables are correctly identified in probability. The effectiveness of the proposed method is also supported by a variety of simulated examples and two real-life examples. Shaogao Lv
