2024 GMorph: Accelerating Multi-DNN Inference via Model Fusion
abstract
AI-powered applications often involve multiple deep neural network (DNN)-based prediction tasks to support application-level functionalities. However, executing multi-DNNs can be challenging due to the high resource demands and computation costs that increase linearly with the number of DNNs. Multi-task learning (MTL) addresses this problem by designing a multi-task model that shares parameters across tasks based on a single backbone DNN. This paper explores an alternative approach called model fusion: rather than training a single multi-task model from scratch as MTL does, model fusion fuses multiple task-specific DNNs that are pre-trained separately and can have heterogeneous architectures into a single multi-task model. We materialize model fusion in a software framework called GMorph to accelerate multi-DNN inference while maintaining task accuracy. GMorph features three main technical contributions: graph mutations to fuse multi-DNNs into resource-efficient multi-task models, search-space sampling algorithms, and predictive filtering to reduce the high search costs. Our experiments show that GMorph can outperform MTL baselines and reduce the inference latency of multi-DNNs by 1.1-3× while meeting the target task accuracy.

2024 Scaler: Efficient and Effective Cross Flow Analysis
abstract
Performance analysis is challenging as different components (e.g., different libraries, and applications) of a complex system can interact with each other. However, few existing tools focus on understanding such interactions. To bridge this gap, we propose a novel analysis method-"Cross Flow Analysis (XFA)"- that monitors the interactions/flows across these components. We also built the Scaler profiler that provides a holistic view of the time spent on each component (e.g., library or application) and every API inside each component. This paper proposes multiple new techniques, such as Universal Shadow Table, and Relation-Aware Data Folding. These techniques enable Scaler to achieve low runtime overhead, low memory overhead, and high profiling accuracy. Based on our extensive experimental results, Scaler detects multiple unknown performance issues inside widely-used applications, and therefore will be a useful complement to existing work.

2024 AdapMTL: Adaptive Pruning Framework for Multitask Learning Model
abstract
In the domain of multimedia and multimodal processing, the efficient handling of diverse data streams such as images, video, and sensor data is paramount. Model compression and multitask learning (MTL) are crucial in this field, offering the potential to address the resource-intensive demands of processing and interpreting multiple forms of media simultaneously. However, effectively compressing a multitask model presents significant challenges due to the complexities of balancing sparsity allocation and accuracy performance across multiple tasks. To tackle these challenges, we propose AdapMTL, an adaptive pruning framework for MTL models. AdapMTL leverages multiple learnable soft thresholds independently assigned to the shared backbone and the task-specific heads to capture the nuances in different components' sensitivity to pruning. During training, it co-optimizes the soft thresholds and MTL model weights to automatically determine the suitable sparsity level at each component to achieve both high task accuracy and high overall sparsity. It further incorporates an adaptive weighting mechanism that dynamically adjusts the importance of task-specific losses based on each task's robustness to pruning. We demonstrate the effectiveness of AdapMTL through comprehensive experiments on popular multitask datasets, namely NYU-v2 and Tiny-Taskonomy, with different architectures, showcasing superior performance compared to state-of-the-art pruning methods.

2021 One-stage Context and Identity Hallucination Network
abstract
Face swapping aims to synthesize a face image, in which the facial identity is well transplanted from the source image and the context (e.g., hairstyle, head posture, facial expression, lighting, and background) keeps consistent with the reference image. The prior work mainly accomplishes the task in two stages, i.e., generating the inner face with the source identity, and then stitching the generation with the complementary part of the reference image by image blending techniques. The blending mask, which is usually obtained by the additional face segmentation model, is a common practice towards photo-realistic face swapping. However, artifacts usually appear at the blending boundary, especially in areas occluded by the hair, eyeglasses, accessories, etc. To address this problem, rather than struggling with the blending mask in the two-stage routine, we develop a novel one-stage context and identity hallucination network, which learns a series of hallucination maps to softly divide the context areas and identity areas. For context areas, the features are fully utilized by a multi-level context encoder. For identity areas, we design a novel two-cascading AdaIN to transfer the identity while retaining the context. Besides, with the help of hallucination maps, we introduce an effectively improved reconstruction loss to utilize unlimited unpaired face images for training. Our network performs well on both context areas and identity areas without any dependency on post-processing. Extensive qualitative and quantitative experiments demonstrate the superiority of our network.
