| 2025 | Layered-Parameter Perturbation for Zeroth-Order Optimization of Optical Neural NetworksabstractOptical neural networks (ONNs) have attracted great attention due to their low power consumption and high-speed processing. When training an ONN implemented on a chip with possible fabrication variations, the well-known backpropagation algorithm cannot be executed accurately because the perfect information inside the chip cannot be observed. Instead, we employ a black-box optimization method such as zeroth-order (ZO) optimization. In this paper, we first discuss how ONN parameters should be perturbed to search for better values in a black-box manner. Conventionally, parameter perturbations are sampled from a normal distribution with an identity covariance matrix. This is plausible if the parameters are not interrelated in a module, like a linear module of an ordinary neural network. However, this is not the best way for ONN modules with layered parameters, which are interrelated by optical paths. We then propose to perturb the parameters by a normal distribution with a special covariance matrix computed by our novel method. The covariance matrix is designed so that the perturbations appearing at the module output caused by the parameter perturbations become as isotropic as possible to uniformly search for better values. Experimental results show that the proposed method using the special covariance matrix significantly outperformed conventional methods. Hiroshi Sawada, Kazuo Aoyama, Masaya Notomi |

| 2025 | Natural Perturbations for Black-box Training of Neural Networks by Zeroth-Order OptimizationabstractThis paper proposes a novel concept of natural perturbations for black-box training of neural networks by zeroth-order optimization. When a neural network is implemented directly in hardware, training its parameters by backpropagation ends up with an inaccurate result due to the lack of detailed internal information. We instead employ zeroth-order optimization, where the sampling of parameter perturbations is of great importance. The sampling strategy we propose maximizes the entropy of perturbations with a regularization that the probability distribution conditioned by the neural network does not change drastically, by inheriting the concept of natural gradient. Experimental results show the superiority of our proposal on diverse datasets, tasks, and architectures. Hiroshi Sawada, Kazuo Aoyama, Yuya Hikima |

| 2025 | Accelerating Spherical K-Means Clustering for Large-Scale Sparse Document DataabstractThis paper presents an accelerated spherical K-means clustering algorithm for large-scale and high-dimensional sparse document data sets. We design an algorithm working in an architecture-friendly manner (AFM), which is a way of suppressing performance-degradation factors such as the numbers of instructions, branch mispredictions, and cache misses in CPUs of a computer system. For the AFM operation, we leverage universal characteristics (UCs) of the data, which are skewed distributions on data relationships. The UCs indicate that the most part of multiplications for similarity calculations is executed on high-document-frequency terms and the most part of a similarity is obtained by the multiplications regarding a few high mean-feature values. To extract the foregoing specific region on terms and mean-feature values, we construct a mean-inverted index partitioned into three regions by two structural parameters. Our algorithm optimizes the parameters by minimizing the approximate number of the multiplications corresponding to the instructions based on our efficient pruning method, reduces conditional branches by sharing the index structure with all the objects, and keeps in the caches the frequently used data in the foregoing specific region. We experimentally demonstrate that our algorithm efficiently achieves superior speed performance in large-scale documents compared with algorithms using the state-of-the-art techniques. | 2024 | Zeroth-Order Optimization of Optical Neural Networks with Linear Combination Natural Gradient and Calibrated ModelabstractOptical neural networks (ONNs) have attracted great attention due to their low energy consumption and high-speed processing. The usual neural network training scheme leads to poor performance for ONNs because of their special parameterization and fabrication variations. This paper contributes to extend zeroth-order (ZO) optimization, which can be used to train such ONNs, in two ways. The first is to propose linear combination natural gradient, which mitigates the optimization difficulty caused by the special parameterization of an ONN. The second is to generate a guided direction vector by calibration for better guessing than random vectors generated in ZO optimization. Experimental results show that the two extensions significantly outperformed the existing ZO optimization and related methods with little computational overhead. | 2021 | Acceleration Method for Learning Fine-Layered Optical Neural NetworksabstractAn optical neural network (ONN) is a promising system due to its high-speed and low-power operation. Its linear unit performs a multiplication of an input vector and a weight matrix in optical analog circuits. Among them, a circuit with a multiple-layered structure of programmable Mach-Zehnder interferometers (MZIs) can realize a specific class of unitary matrices with a limited number of MZIs as its weight matrix. The circuit is effective for balancing the number of programmable MZIs and ONN performance. However, it takes a lot of time to learn MZI parameters of the circuit with a conventional automatic differentiation (AD), which machine learning platforms are equipped with. To solve the time-consuming problem, we propose an acceleration method for learning MZI parameters. We create customized complex-valued derivatives for an MZI, exploiting Wirtinger derivatives and a chain rule. They are incorporated into our newly developed function module implemented in C++ to collectively calculate their values in a multi-layered structure. Our method is simple, fast, and versatile as well as compatible with the conventional AD. We demonstrate that our method works 20 times faster than the conventional AD when a pixel-by-pixel MNIST task is performed in a complex-valued recurrent neural network with an MZI-based hidden unit. | 2019 | Similarity Search-based Blind Source SeparationabstractIn this paper, we propose a new method for blind source separation, where we perform similarity search for a prepared clean speech database. The purpose of this mechanism is to separate short utterances that we frequently encounter in a real-world situation. The new method employs a local Gaussian model (LGM) for the probability density functions of separated signals, and updates the LGM variance parameters by using the similarity search results. Experimental results show that the method performed very well in an ideal situation where we employ a close database that contains the source components used for the mixtures. In more realistic situations where an open database was used, the separation performance degraded to a certain degree, but was still better than existing methods. Hiroshi Sawada, Kazuo Aoyama |

| 2016 | Pivot-based k-means Algorithm for Numerous-class Data SetsabstractThis paper presents an accelerated k-means clustering algorithm suitable for a large-scale and numerous-class data set. The proposed iterative algorithm avoids unnecessary exact distance calculations, especially in the early and the last stage in its convergence process, and retains the same result as the standard algorithm. This is efficiently performed by two distinct components. One uses the lower bounds on exact distances between objects and centroids for the acceleration in the early stage. The lower bound is calculated by the triangle inequality with newly introduced fixed points called pivots. The other component for the last stage skips the distance calculation between an invariant centroid and an object satisfying the following condition. The cluster to which the object is assigned remains unchanged, i.e., its centroid is also invariant. For much further speed-up, we can incorporate an existing algorithm into the proposed algorithm as an extension, which often performs a complementary role in the middle stage. The experimental results we obtained on large-scale and high-dimensional image data sets demonstrate that given a large k value, the proposed algorithm outperforms existing algorithms in terms of both the reduction rate of distance calculations and elapsed time. | 2015 | Double-layer neighborhood graph based similarity search for fast query-by-example spoken term detectionabstractThis paper presents a novel double-layer neighborhood graph index for acceleration of similarity search that accomplishes fast querybyexample spoken term detection (STD). When a query segment is given, our proposed STD method finds similar segments to the query from an utterance data set by efficient similarity search that traverses the double-layer neighborhood graph (DLG) with a low computational cost. The segment is a sequence of Gaussian mixture model posteriorgram frames and corresponds to a vertex in the DLG. A dissimilarity between vertices is measured by dynamic time warping. The DLG consists of two distinct degree-reduced k-nearest neighbor graphs in a base and an upper layer. The base layer's graph has all the vertices in the data set while the upper layer's graph includes only representatives extracted from the vertices in the base layer. By way of analogy, search in the DLG resembles driving on general roads and express highways appropriately for travel-time saving. Experimental results on the MIT lecture corpus demonstrate that the proposed method achieves CPU time reduction by 40% and more than 60% compared to the most recent method and the ordinary graphbased method, keeping almost the same precision. | 2014 | Zero-resource spoken term detection using hierarchical graph-based similarity searchabstractThis paper presents fast zero-resource spoken term detection (STD) in a large-scale data set, by using a hierarchical graph-based similarity search method (HGSS). HGSS is an improved graph-based similarity search method (GSS) in terms of a search space for high-speed performance. Instead of a degree-reduced k-nearest neighbor (k-DR) graph for GSS, a hierarchical k-DR graph, which is constructed based on a cluster structure in the corresponding k-DR graph, is used as an index for HGSS. A search algorithm for the hierarchical k-DR graph effectively utilizes the cluster structure, resulting in the reduction of the search space. HGSS inherits the useful property of GSS; it is available for any data sets without limits on a data type nor a defined dissimilarity since a graph is a general expression of a relationship between objects. A vertex and an edge in the hierarchical graph correspond to a Gaussian mixture model (GMM) posterior-gram segment and the relationship between a pair of GMM poste-riorgram segments, which is measured by dynamic time warping, respectively. Experimental results demonstrate that HGSS successfully reduces the computational cost by more than 40 % at nearly the same accuracy, compared to GSS. | 2013 | Graph index based query-by-example search on a large speech data setabstractThis paper presents a neighborhood graph index approach for query-by-example search using dynamic time warping (DTW) on Gaussian mixture model (GMM) posteriorgram sequences. The approach is intended to achieve a significant speed-up of a spoken term detection (STD) task for resource-limited situations. The proposed method employs a degree-reduced k-nearest neighbor (k-DR) graph as an index. A set of k-DR graphs is pre-constructed off-line from a large number of GMM posteriorgram sequences. Given a query posteriorgram sequence, one k-DR graph is selected from the set as the index. By applying a newly introduced combination of greedy-search (GS) and breadth-first search (BFS) algorithms to the selected k-DR graph index, the proposed method efficiently achieves query-by-example STD. Experimental results on the MIT lecture corpus demonstrate that the proposed method works much faster than a state-of-art method by more than one order magnitude, keeping almost the same precision. | 2011 | Fast approximate similarity search based on degree-reduced neighborhood graphsabstractThis paper presents a fast approximate similarity search method for finding the most similar object to a given query object from an object set with a dissimilarity with a success probability exceeding a given value. As a search index, the proposed method utilizes a degree-reduced k-nearest neighbor (k-DR) graph constructed from the object set with the dissimilarity, and explores the k-DR graph along its edges using a greedy search (GS) algorithm starting from multiple initial vertices with parallel processing. In the graph-construction stage, the structural parameter k of the k-DR graph is determined so that the probability with which at least one search trial of those with multiple initial vertices succeeds is more than the given success probability. To estimate the greedy-search success probability, we introduce the concept of a basin in the k-DR graph. The experimental results on a real data set verify the approximation scheme and high search performance of the proposed method and demonstrate that it is superior to E2LSH in terms of the expected search cost. | 2010 | Fast similarity search on a large speech data set with neighborhood graph indexingabstractThis paper presents a novel graph-based approach for solving a problem of fast finding a speech model acoustically similar to a query model from a large set of speech models. Each speech model in the set is represented by a Gaussian mixture model and dissimilarity from a GMM to another is measured with a Kullback-Leibler divergence (KLD). Conventional pruning techniques based on the triangle inequality for fast similarity search are not available because the model space with a KLD is not a metric space. We propose a search method that is characterized by an index of a degree-reduced nearest neighbor (DRNN) graph. The search method can efficiently find the most similar (closest) GMM to a query, exploring the DRNN graph with a best-first manner. Experimental evaluations on utterance GMM search tasks reveal a significantly low computational cost of the proposed method. | 2007 | Design Methods for Symmetric Function Generators Based on Threshold ElementsabstractThis paper presents two design methods for threshold element (TE)-based symmetric function generators (SFGs). SFGs enable reconflgurable devices to be more economical by using fewer elements and configuration variables, as compared with lookup tables in conventional field-programmable gate arrays. The first method generates an SFG that consists of (n + 2) TEs and that utilizes (n + 1) configuration variables for any symmetric function of n input variables. The second method successfully reduces the number of TEs because it allows each TE to utilize more configuration variables. This SFG consists of {[29(n + 1)/3] + 1} TEs and utilizes [4(n + l)/3] configuration variables. There is a tradeoff between the number of TEs and configuration variables in these two SFGs. This tradeoff is discussed in relation to circuit performance. Kazuo Aoyama |
