2015 Randomized Dimensionality Reduction for k-Means Clustering
abstract
We study the topic of dimensionality reduction for k-means clustering. Dimensionality reduction encompasses the union of two approaches: 1) feature selection and 2) feature extraction. A feature selection-based algorithm for k-means clustering selects a small subset of the input features and then applies k-means clustering on the selected features. A feature extraction-based algorithm for k-means clustering constructs a small set of new artificial features and then applies k-means clustering on the constructed features. Despite the significance of k-means clustering as well as the wealth of heuristic methods addressing it, provably accurate feature selection methods for k-means clustering are not known. On the other hand, two provably accurate feature extraction methods for k-means clustering are known in the literature; one is based on random projections and the other is based on the singular value decomposition (SVD). This paper makes further progress toward a better understanding of dimensionality reduction for k-means clustering. Namely, we present the first provably accurate feature selection method for k-means clustering and, in addition, we present two feature extraction methods. The first feature extraction method is based on random projections and it improves upon the existing results in terms of time complexity and number of features needed to be extracted. The second feature extraction method is based on fast approximate SVD factorizations and it also improves upon the existing results in terms of time complexity. The proposed algorithms are randomized and provide constant-factor approximation guarantees with respect to the optimal k-means objective value.

2014 Templated Search over Relational Databases
abstract
Businesses and large organizations accumulate increasingly large amounts of customer interaction data. Analysis of such data holds great importance for tasks such as strategic planning and orchestration of sales/marketing campaigns. However, discovery and analysis over heterogeneous enterprise data can be challenging. Primary reasons for this are dispersed data repositories, requirements for schema knowledge, and difficulties in using complex user interfaces. As a solution to the above, we propose a TEmplated Search paradigm (TES) for exploring relational data that combines the advantages of keyword search interfaces with the expressive power of question-answering systems. The user starts typing a few keywords and TES proposes data exploration questions in real time. A key aspect of our approach is that the questions displayed are diverse to each other and optimally cover the space of possible questions for a given question-ranking framework. Efficient exact and provably approximate algorithms are presented. We show that the Templated Search paradigm renders the potentially complex underlying data sources intelligible and easily navigable. We support our claims with experimental results on real-world enterprise data.

2014 Non-uniform feature sampling for decision tree ensembles
abstract
We study the effectiveness of non-uniform randomized feature selection in decision tree classification. We experimentally evaluate two feature selection methodologies, based on information extracted from the provided dataset: (i) leverage scores-based and (ii) norm-based feature selection. Experimental evaluation of the proposed feature selection techniques indicate that such approaches might be more effective compared to naive uniform feature selection and moreover having comparable performance to the random forest algorithm [3].

2014 Approximate matrix multiplication with application to linear embeddings
abstract
In this paper, we study the problem of approximately computing the product of two real matrices. In particular, we analyze a dimensionality-reduction-based approximation algorithm due to Sarlos [1], introducing the notion of nuclear rank as the ratio of the nuclear norm over the spectral norm. The presented bound has improved dependence with respect to the approximation error (as compared to previous approaches), whereas the subspace - on which we project the input matrices - has dimensions proportional to the maximum of their nuclear rank and it is independent of the input dimensions. In addition, we provide an application of this result to linear low-dimensional embeddings. Namely, we show that any Euclidean point-set with bounded nuclear rank is amenable to projection onto number of dimensions that is independent of the input dimensionality, while achieving additive error guarantees.

2014 Hidden Cliques and the Certification of the Restricted Isometry Property
abstract
Compressed sensing is a technique for finding sparse solutions to underdetermined linear systems. This technique relies on properties of the sensing matrix such as the restricted isometry property. Sensing matrices that satisfy this property with optimal parameters are mainly obtained via probabilistic arguments. Deciding whether a given matrix satisfies the restricted isometry property is a nontrivial computational problem. Indeed, it is shown in this paper that restricted isometry parameters cannot be approximated in polynomial time within any constant factor under the assumption that the hidden clique problem is hard. In addition, on the positive side, an improvement on the brute-force enumeration algorithm for checking the restricted isometry property is proposed.

2013 Efficient Dimensionality Reduction for Canonical Correlation Analysis
abstract
We present a fast algorithm for approximate Canonical Correlation Analysis (CCA). Given a pair of tall-and-thin matrices, the proposed algorithm first employs a randomized dimensionality reduction transform to reduce the size of the input matrices, and then applies any standard CCA algorithm to the new pair of matrices. The algorithm computes an approximate CCA to the original pair of matrices with provable guarantees, while requiring asymptotically less operations than the state-of-the-art exact algorithms.

2011 Low Rank Matrix-valued Chernoff Bounds and Approximate Matrix Multiplication
abstract
In this paper we develop algorithms for approximating matrix multiplication with respect to the spectral norm. Let A ∊ ℝn×m and B ∊ ℝn×p be two matrices and ε > 0. We approximate the product A⊤ B using two sketches and , where t ≪ n, such that with high probability. We analyze two different sampling procedures for constructing and ; one of them is done by i.i.d. non-uniform sampling rows from A and B and the other by taking random linear combinations of their rows. We prove bounds on t that depend only on the intrinsic dimensionality of A and B, that is their rank and their stable rank. For achieving bounds that depend on rank when taking random linear combinations we employ standard tools from high-dimensional geometry such as concentration of measure arguments combined with elaborate ε-net constructions. For bounds that depend on the smaller parameter of stable rank this technology itself seems weak. However, we show that in combination with a simple truncation argument it is amenable to provide such bounds. To handle similar bounds for row sampling, we develop a novel matrix-valued Chernoff bound inequality which we call low rank matrix-valued Chernoff bound. Thanks to this inequality, we are able to give bounds that depend only on the stable rank of the input matrices. We highlight the usefulness of our approximate matrix multiplication bounds by supplying two applications. First we give an approximation algorithm for the ℓ2-regression problem that returns an approximate solution by randomly projecting the initial problem to dimensions linear on the rank of the constraint matrix. Second we give improved approximation algorithms for the low rank matrix approximation problem with respect to the spectral norm.

2010 Random Projections for $k$-means Clustering
abstract
This paper discusses the topic of dimensionality reduction for $k$-means clustering. We prove that any set of $n$ points in $d$ dimensions (rows in a matrix $A \in \RR^{n \times d}$) can be projected into $t = \Omega(k / \eps^2)$ dimensions, for any $\eps \in (0,1/3)$, in $O(n d \lceil \eps^{-2} k/ \log(d) \rceil )$ time, such that with constant probability the optimal $k$-partition of the point set is preserved within a factor of $2+\eps$. The projection is done by post-multiplying $A$ with a $d \times t$ random matrix $R$ having entries $+1/\sqrt{t}$ or $-1/\sqrt{t}$ with equal probability. A numerical implementation of our technique and experiments on a large face images dataset verify the speed and the accuracy of our theoretical results.

2010 Inapproximability for Planar Embedding Problems
abstract
We consider the problem of computing a minimum-distortion bijection between two point-sets in ℝ2. We prove the first non-trivial inapproximability result for this problem, for the case when the distortion is constant. More precisely, we show that there exist constants 0 < α < β, such that it is NP-hard to distinguish between spaces for which the distortion is either at most α, or at least β, under the Euclidean norm. This addresses a question of Kenyon, Rabani and Sinclair [KRS04], and extends a result due to Papadimitriou and Safra [PS05], who gave inapproximability for point-sets in ℝ3. We also apply similar ideas to the problem of computing a minimum-distortion embedding of a finite metric space into ℝ2. We obtain an analogous inapproximability result under the ℓ∞ norm for this problem. Inapproximability for the case of constant distortion was previously known only for dimension at least 3 [MS08].
